Abstract:Based on the benefits of different ensemble methods, such as bagging and boosting, which have been studied and adopted extensively in research and practice, where bagging and boosting focus more on reducing variance and bias, this paper presented an optimization ensemble learning-based model for a large pipe failure dataset of water pipe leakage forecasting, something that was not previously considered by others. It is known that tuning the hyperparameters of each base learned inside the ensemble weight optimization process can produce better-performing ensembles, so it effectively improves the accuracy of water pipe leakage forecasting based on the pipeline failure rate. To evaluate the proposed model, the results are compared with the results of the bagging ensemble and boosting ensemble models using the root-mean-square error (RMSE), the mean square error (MSE), the mean absolute error (MAE), and the coefficient of determination (R2) of the bagging ensemble technique, the boosting ensemble technique and optimizable ensemble technique are higher than other models. The experimental result shows that the optimizable ensemble model has better prediction accuracy. The optimizable ensemble model has achieved the best prediction of water pipe failure rate at the 14th iteration, with the least RMSE = 0.00231 and MAE = 0.00071513 when building the model that predicts water pipe leakage forecasting via pipeline failure rate.

Abstract:Water pipe failures can cause significant economic and social costs, hence have become the primary challenge to water utilities. In this paper, we propose a Bayesian nonparametric approach, namely the Dirichlet process mixture of hierarchical beta process model, for water pipe failure prediction. It can select high-risk pipes for physical condition assessment, thereby preventing disastrous failures proactively. The proposed method is adaptable to the diversity of failure patterns. Its model structure and complexity can automatically adjust according to observed data. Additionally, the sparse failure data problem that often occurs in real-world data is tackled by the proposed method via flexible pipe grouping and failure data sharing. An approximated yet computational efficient Metropolis-within-Gibbs sampling method is developed with the exploitation of the failure data sparsity for model parameter inference. The proposed method has been applied to a metropolitan water supply network. The details of the application context are also presented for demonstrating its real-life impact. The comparison experiments conducted on the metropolitan water pipe data show that the proposed approach significantly outperforms the state-of-the-art prediction methods, and it is capable of bringing enormous economic and social savings to water utilities.

Abstract:The failure of water pipes in Water Distribution Networks (WDNs) is associated with environmental, economic, and social consequences. It is essential to mitigate these failures by analyzing the historical data of WDNs. The extant literature regarding water pipe failure analysis is limited by the absence of a systematic selection of significant factors influencing water pipe failure and eliminating the bias associated with the frequency distribution of the historical data. Hence, this study presents a new framework to address the existing limitations. The framework consists of two algorithms for categorical and numerical factors influencing pipe failure. The algorithms are employed to check the relevance between the pipe's failure and frequency distributions in order to select the most significant factors. The framework is applied to Hong Kong WDN, selecting 10 out of 21 as significant factors influencing water pipe failure. The likelihood feature method and Bayes' theorem are applied to estimate failure probability due to the pipe materials and the factors. The results indicate that galvanized iron and polyethylene pipes are the most susceptible to failure in the WDN. The proposed framework enables decision-makers in the water infrastructure industry to effectively prioritize their networks' most significant failure factors and allocate resources accordingly.

Abstract:The existing combination method for water quality prediction lacks of a framework approach and the probability prediction is always based on an assumption that water quality index follows certain probability distribution.A new method based on probability-combination for water quality prediction was proposed.The method combined the prediction results of different single methods through the use of Odds-Matrix method and it could improve the performances of prediction effectively.It was worth noting that the combination-forecast approach could be extended to new methods.The probability of prediction was established through statistical analysis of historical prediction data and hence the validation of the method was achieved along with interval estimation under certain confidence level.The Probability-Combination method based on gray model group and exponent smoothing was proposed for Jiukengkou,Zhejiang.Experimental results indicated that the combination-forecast approach performs better than single prediction method.The validity of probability establishment could be checked effectively.According to the results,the envelopes of water-quality curve under certain confidence level were derived.The prediction accuracy and stability could be improved effectively and probability results which could be the basis of the decision-making could also be given successfully by probability-combination.Furthermore,as a framework approach,it could add new prediction methods continuously.
Probabilistic model to predict longitudinal fracture failure of buried pvc pipes

Abstract:To resolve the longitudinal fracture failure problems for the buried PVC pipes with inherent defects under the complex stress induced by loads,the failure prediction model was developed,taking circumferential mechanical characters of pipes and a crack growth model into consideration. Monte-Carlo (MC) simulations were used to perform the probabilistic analysis,because of the uncertainty of the model and parameters. Results show that it is suitable to adopting the failure prediction model to calculate the failure rates,because the calculated values agreed well with the measured data. The crack growth rate increased with time under constant external stresses. The pipes with larger defect sizes had shorter lifetimes. The failure rate when considering all of random variables was two times that of only considering the initial defect as a random variable,and it reached the maximum within 20 years,then slowed down gradually. The initial defect sizes,internal pressure,residual stresses and pipe thickness have large influence on the lifetime of PVC pipes. Increased internal pressure and residual stresses lead to increase failure rates. An accurate probability distribution of the initial defect is most important to calculate the failure rates. Reducing initial defect sizes by using suitable production process and installation technology can effectively extend the service life.

Abstract:Drinking water pipe and waste water pipe networks are valuable urban infrastructure assets that are responsible for reliable water resource distributions and waste water collection. However, due to fast growing demand and aging assets, water utilities find it increasingly difficult to efficiently maintain their pipe networks. Pipe failures - drinking water pipe breaks and waste water pipe blockages - can cause significant economic and social costs, and hence have become the primary challenge to water utilities. Identifying key influential factors, e.g., pipes' physical attributes, environmental features, is critical for understanding pipe failure behaviours. The domain knowledge plays a significant role in this aspect. In this work, we propose a Bayesian nonparametric machine learning model with the support of domain knowledge for pipe failure prediction. It can forecast future high-risk pipes for physical condition assessment, thereby proactively preventing disastrous failures. Moreover, compared with traditional machine learning approaches, the proposed model considers domain expert knowledge and experience, which helps avoid the limit of traditional machine learning approaches - learning only from what it sees - and improves prediction performance.
Failure Prediction and Reliability Analysis of Buried Grey Cast Iron Water Mains Considering Corrosion

Abstract:To resolve the serious breakage and leakage problems for the grey cast iron water mains buried in the early years in the water-supply system, pipe stresses were firstly calculated based on the pipe soil inter-action model, and the corrosion depth was predicted by the corrosion model. Then, the residual strength associated with corrosion was evaluated, and a failure prediction model was given by using the failure crite-rion for the cast iron. Monte Carlo (MC) simulations were used to perform the probabilistic analysis. The given model fully considers the influences of corrosion, external loads and uncertainties on the pipe failure. Results show that the pipes will not be failed when only considering the external loads. The corrosion is one of the very important factors contributing to the pipe failure. The probability density distribution of the safety factor of the pipe appears a lognormal distribution. The hazard of the pipe failure is large in 20-50 years, and it becomes small after 80 years and decreases with the time. The influence on the failure probability is large for considering soil bedding lost induced by the breakage or uneven settlement when the corrosion depth reaches a certain depth.
Towards Effective Prioritizing Water Pipe Replacement and Rehabilitation.

Abstract:Water pipe failures can not only have a great impact on people's daily life but also cause significant waste of water which is an essential and precious resource to human beings. As a result, preventative maintenance for water pipes, particularly in urban-scale networks, is of great importance for a sustainable society. To achieve effective replacement and rehabilitation, failure prediction aims to proactively find those 'most-likely-to-fail' pipes becomes vital and has been attracting more attention from both academia and industry, especially from the civil engineering field. This paper presents an already-deployed industrial computational system for pipe failure prediction. As an alternative to risk matrix methods often depending on ad-hoc domain heuristics, learning based methods are adopted using the attributes with respect to physical, environmental, operational conditions and etc. Further challenge arises in practice when lacking of profile attributes. A dive into the failure records shows that the failure event sequences typically exhibit temporal clustering patterns, which motivates us to use the stochastic process to tackle the failure prediction task. Specifically, the failure sequence is formulated as a self-exciting stochastic process which is, to our best knowledge, a novel formulation for pipe failure prediction. And we show that it outperforms a baseline assuming the failure risk grows linearly with aging. Broad new problems and research points for the machine learning community are also introduced for future work.

Abstract:Pipe failure prediction has become a crucial demand of operators in daily operation and asset management due to the increase in operation risks of water distribution networks. In this paper, two machine learning algorithms, namely, random forest (RF) and logistic regression (LR) algorithms are employed for pipe failure prediction. RF algorithm consists of a group of decision trees that predicts pipe failure independently and makes the final decision by voting together. For the LR algorithm, the mapping relationship between existing data and decision variables is expressed by the logistic function. Then, the prediction is made by comparing the conditional probability with the fixed threshold value. The proposed algorithms are illustrated using an actual water distribution network in China. Results indicate that the RF algorithm performs better than the LR algorithm in terms of accuracy, recall, and area under the receiver operating characteristic curve. The effects of seven characteristics on pipe failures are analyzed, and diameter and length are identified as the top two influential factors.Graphical Abstract

Abstract:Underground water pipes deteriorate under the influence of various physical, mechanical, environmental, and social factors. Reliable pipe failure prediction is essential for a proactive management strategy of the water supply network (WSN), which is challenging for the conventional physics-based model. This study applied data-driven machine learning (ML) models to predict water pipe failures by leveraging the historical maintenance data heritage of a large water supply network. A multi-source data-aggregation framework was firstly established to integrate various contributing factors to underground pipe deterioration. The framework defined criteria for the integration of various data sources including the historical pipe break dataset, soil type dataset, topographical dataset, census dataset, and climate dataset. Based on the data, five ML algorithms, including LightGBM, Artificial Neural Network, Logistic Regression, K-Nearest Neighbors, and Support Vector Classification are developed for pipe failure prediction. LightGBM was found to achieve the best performance. The relative importance of major contributing factors on the water pipe failures was analyzed. Interestingly, the socioeconomic factors of a community are found to affect the probability of pipe failures. This study indicates that data-driven analysis that integrates the Machine Learning (ML) techniques and the proposed data integration framework has the potential to support reliable decision-making in WSN management.

Abstract:Both minimum night flow (MNF) and pipe failures are common ways of understanding leakage within water distribution networks (WDNs). This article takes a data-driven approach and applies linear models, random forests, and neural networks to MNF and pipe failure prediction. First, models are trained to estimate the historic average MNF for over 800 real-world DMAs from the UK. Features for this problem are constructed from pipe records which detail the length, diameter, volume, age, material, and number of customer connections of each pipe. The results show that 65% of the variation in historic average MNF can be explained using these factors alone. Second, a novel method is proposed to deconstruct the models' predictions into a leakage contribution score (LCS), estimating how each individual pipe in a DMA has contributed to the MNF. In order to validate this novel approach, the LCS values are used to classify pipes based on historic pipe failure and are compared against models directly trained for this. The results show that the LCS performs well at this task, achieving an AUC of 0.71. In addition, it is shown that both LCS and directly trained models agree in many cases on an example real-world DMA.

Abstract:Pipe failure often occurs in water distribution networks (WDNs) and results in high levels of water loss and socio-economic damage. Physical-based, statistical and data-driven models have been developed to estimate pipe failure rates (failures per km of pipe per year) to efficiently manage water losses from WDNs and to ensure safe operations. Due to the complexities of pipe failure patterns, we develop a superposed statistical model to depict the relationship between pipe failure rate and pipe age. The model’s level of uncertainty was then quantified by simulating pipe failures as Poisson numbers. Part of Beijing’s WDN is taken as a study case, and pipe failure data for a 4-year period, as well as pipe properties, are collected to develop the pipe failure model. The case study results show that the pipe failure rates vary with time in a non-monotonic manner and that the proposed model captures pipe failure behaviour with an R2 value of 0.95. A 95% confidence interval of modelled pipe failures for each pipe age group is used to describe the uncertainty level of the model. We find that 88% of the observations fall under the 95% confidence interval. The established model could be applied to prioritize pipes with higher failure rates to optimize pipe replacement/rehabilitation strategies. Our uncertainty analysis of this model can help utility managers understand the model’s reliability and formulate reasonable WDN management plans.

Abstract:Companies in charge of water supply networks are making a huge effort to optimally plan the annual replacements of pipes. This would save costs, enable a higher quality of service and a sustainable management of infrastructure.This study presents a methodology to predict pipe failures in water supply networks. Logistic regression and support vector classification are chosen as predictive systems. Both provide a failure probability associated with each sample which is increasingly required by companies that manage these infrastructures. Furthermore, several pre-processing techniques that seek to improve the accuracy of predictions are addressed.The proposed methodology is illustrated with the real case of a Spanish city. This is an extensive water supply network whose recorded data contains 4,393 pipe failures. The results obtained state that the number of unexpected failures might be significantly reduced. Around 30% of failures could have been prevented by replacing only 3% of the network's pipes per year, which is a realistic and feasible option.As a future line of research, the objective must be to develop a global tool that incorporates the failure probability and its consequence, generating the optimal pipe replacement plan.

Abstract:Understanding performance and prioritizing resources for the maintenance of the drinking-water pipe network throughout its life-cycle is a key part of water asset management. Renovation of this vital network is generally hindered by the difficulty or impossibility to gain physical access to the pipes. We study a statistical and machine learning framework for the prediction of water pipe failures. We employ classical and modern classifiers for a short-term prediction and survival analysis to provide a broader perspective and long-term forecast, usually needed for the economic analysis of the renovation. To enrich these models, we introduce new predictors based on water distribution domain knowledge and employ a modern oversampling technique to remedy the high imbalance coming from the few failures observed each year. For our case study, we use a dataset containing the failure records of all pipes within the water distribution network in Barcelona, Spain. The results shed light on the effect of important risk factors, such as pipe geometry, age, material, and soil cover, among others, and can help utility managers conduct more informed predictive maintenance tasks.

Prioritising water pipes for condition assessment with data analytics

Abstract:This work proposes a method for prioritising critical water mains (CWMs) with high risk, in terms of both failure probability and consequence costs. The proposed method can improve the prioritisation of high-risk CWMs requiring condition assessment in the near future and will further optimise the operational maintenance of water utilities. Due to the improved prioritisation, water utilities can reduce economic loses by predicting more CWM failures with high consequences and renew only mains of high risk. Our contributions mainly lie in two data analytics techniques: 1) an efficient and effective method of CWM failure prediction based on Bayesian nonparametric modelling called hierarchical beta process (HBP), and 2) a riskaversion method of CWM selection for condition assessment based on constrained binary integer programming (BIP). Test results on a dataset from the water utility show that the proposed method outperforms previous methods in both pipe failure prediction and consequence cost savings by doubling the failure prediction performance.

Abstract:National and local regulations mandate water utilities to deliver safe and clean drinking water to consumers. However, due to the aging water infrastructure, they face numerous challenges regarding water loss and water quality impairments within the distribution networks. In this paper, a multi-objective nonlinear model was developed to maximize the buried water mean time to failure with consideration of cost and environmental aspects. The model determined the type of pipe material appropriate for each location with the maximum reliability, minimum environmental impacts, and minimum cost. An exact method (weighted sum method (WSM)) and two meta -heuristic algorithms (multi-objective particle swarm optimization (MOPSO) and non-dominated sorting genetic algorithm II (NSGA-II)) were applied to solve the model in the large dimension. After examining the proposed solution methods across different numerical examples, the best optimal approach was identified. Then, the mathematical model and the best solution approach were validated in a real case study of the drinking water distribution system (WDS) in Iran. Moreover, the inherent uncertainty associated with the total cost objective function were assessed by conducting a sensitivity analysis on key parameters such as the annual interest rate, pipe cost, probability of pipe installation, and installation cost. Therefore, to overcome these uncertainties, a robust optimization method introduced by Soyster was used. Ultimately, the study provided managerial insights drawn from the results of the sensitivity analysis. The findings can aid water utilities and decision-makers in formulating water infrastructure rehabilitation plans that are more effective and characterized by diminished environmental impacts and lower costs.

Abstract:<p>To reduce leakage and improve service levels, water companies are increasingly using statistical models of pipe failure using infrastructure, weather and environmental data. However, these models are often built by environmental data scientists with limited in-field experience of either fixing pipes or recording data about network failures. As infrastructure data can be inconsistent, incomplete and incorrect, this disconnect between model builders and field operatives can lead to logical errors in how datasets are interpreted and used to create predictive models. An improved understanding of pipe failure can facilitate improved selection of model inputs and the modelling approach. To enable data scientists to build more accurate predictive models of pipe failure, this paper summarises typical factors influencing failure for 5 common groups of materials for water pipes: 1) cast and spun iron, 2) ductile iron, 3) steel, 4) asbestos cement, 5) polyvinyl chloride (PVC) and 6) polyethylene (PE) pipes. With an improved understanding of why and how pipes fail, data scientists can avoid misunderstanding and misusing infrastructure and environmental data, and build more accurate models of infrastructure failure.</p>

Abstract:Steel pipelines, whether buried in the ground or exposed to the atmosphere, are susceptible to corrosion, which may impact their structural integrity. Pipeline failures can be catastrophic, especially for pipelines that transport hazardous materials. Maintenance actions, however, are often deferred following detection of localized corrosion due to operational requirements and financial constraints. Consequently, pipeline owners are often confronted with decisions as to whether a corroded pipe is still fit for service with an acceptable reliability or what is the remaining service life of the pipe before it poses a serious threat to public safety. The methodology presented in this paper to predict remaining service life of pressurized steel pipelines can be used to support decisions related to continued safe pipe operation and optimal pipe inspection intervals and maintenance schedules.
Mechanical model and probability analysis of buried pipelines failure under uniform corrosion

Abstract:To resolve the failure problems for the buried oil and gas pipelines under the combined effect of soil corrosion and complex stress induced by external loads, a failure prediction model was developed by combining longitudinal and circumferential mechanical characteristics of pipes with the corrosion model. First order second moment (FOSM) was used to perform the probabilistic analysis, taking the uncertainty of the model and parameters into consideration. Then the sensitivity analysis of the important parameters such as inner pressure, residual stresses and corrosion parameters were given. Results showed that it was suitable to adopting the FOSM to calculate the failure probability, because the value by the FOSM agreed well with the one by the Monte-Carlo method (MC). The reliability decreased with the increased mean values and variances of the inner pressure and residual stresses. The residual stresses, which were released with corrosion, had smaller influence on the pipe failure in the late stage. The failure probability of pipes increased fast when used 10-20 years, but slowed down after then because of the self inhibition of corrosion process. The inner pressure, residual stresses, pipe thickness and corrosion parameters have large influence on the failure probability for the buried oil and gas pipes. The corrosion is one of the most important factors contributing to the pipe failure. Reducing corrosion pit depth growth by using the corrosion control technique can be the most effective way to decelerate the breakage growth rate and extend the service life.
