Abstract:Hierarchical clustering is a popular method of performing unsupervised learning. Some metric must be used to determine the similarity between pairs of clusters in hierarchical clustering. Traditional similarity metrics either can deal with simple shapes (i.e. spherical shapes) only or are very sensitive to outliers (the chaining effect). The main contribution of this paper is to propose some potential-based similarity metrics (APES and AMAPES) between clusters in hierarchical clustering, inspired by the concepts of the electric potential and the gravitational potential in electromagnetics and astronomy. The main features of these metrics are: the first, they have strong anti jamming capability; the second, they are capable of finding clusters of different shapes such as spherical, spiral, chain, circle, sigmoid, U shape or other complex irregular shapes; the third, existing algorithms and research fruits for classical metrics can be adopted to deal with these new potential-based metrics with no or little modification. Experiments showed that the new metrics are more superior to traditional ones. Different potential functions are compared, and the sensitivity to parameters is also analyzed in this paper.

Abstract:A very important category of clustering methods is hierarchical clustering. There are considerable research efforts which have been focused on algorithm-level improvements of the hierarchical clustering process. In this paper, our goal is to provide a systematic understanding of hierarchical clustering from a data distribution perspective. Specifically, we investigate the issues about how the ''true'' cluster distribution can make impact on the clustering performance, and what is the relationship between hierarchical clustering schemes and validation measures with respect to different data distributions. To this end, we provide an organized study to illustrate these issues. Indeed, one of our key findings reveals that hierarchical clustering tends to produce clusters with high variation on cluster sizes regardless of ''true'' cluster distributions. Also, our results show that F-measure, an external clustering validation measure, has bias towards hierarchical clustering algorithms which tend to increase the variation on cluster sizes. Viewed in light of this, we propose F"n"o"r"m, the normalized version of the F-measure, to solve the cluster validation problem for hierarchical clustering. Experimental results show that F"n"o"r"m is indeed more suitable than the unnormalized F-measure in evaluating the hierarchical clustering results across data sets with different data distributions.

Abstract:In this paper we propose a new clustering method named CURS (a hierarchical clustering algorithm based on references and separation). The algorithm first uses a certain number of reference points to represent the shape and extent of a cluster, and then use a small cluster merging mechanism which based on similar reference points, and a validity index is introduced to quantify the clustering quality, In order to avoid the low-quality clusters spreading to the high-level, it re-divides the low-quality clusters. Both theory analysis and experimental results confirm that CURS can handle clusters with arbitrary shape, In the clustering process it introduce a quality evaluation index, and cluster splitting mechanism, this can effectively deal with noise and ensure the clustering results has strong robustness. At the same time, CURS can provide better clustering result with high executing efficiency.
HCDC: A novel hierarchical clustering algorithm based on density-distance cores for data sets with varying density

Abstract:Cluster analysis is a crucial data mining technology widely used in image segmentation, language processing, and pattern recognition. Most existing clustering algorithms cannot identify complex shapes in manifold data sets and data sets with varying-density distribution, especially when clusters with significant differences in density are close to each other. Hierarchical clustering algorithms can identify data sets of arbitrary shapes. However, hierarchical clustering algorithms not only cannot cluster datasets with significant density variations but also have a high time cost. So in this paper, we propose a novel hierarchical clustering algorithm based on density-distance cores, called HCDC. It first selects the density-distance representative points for each point from the set of candidate representative points. Then it selects density-distance cores from all density-distance representatives. And it replaces the whole data set with density-distance cores and uses a new distance between them to apply hierarchical clustering. To avoid the influence of noise points in the dataset when finding density-distance cores, we also propose the noise point detection method and verify the feasibility of this method. In this paper, we compare our proposed algorithm with existing classical and novel algorithms on synthetic and real datasets. Experiments show that our algorithm clusters better than existing algorithms on complex-shaped datasets and datasets with different densities. On datasets with sparse and dense clusters close to each other, the ARI score of HCDC is more than 0.1 higher than that of LDP-MST. In particular, on the grid dataset, HCDC's ARI score is 0.997 higher than LDP-MST. On DS3 and DS8, HCDC's ARI score is more than 0.14 higher than the second-best algorithm, RNN-DBSCAN. Moreover, on the zoo dataset, HCDC's ARI score is 0.15 and 0.6 higher than RNN-DBSCAN and LDP-MST, respectively. On the olivetti face dataset, HCDC is the only algorithm with an NMI score above 0.9 on photo1 and photo2 datasets.

Abstract:The target of the clustering analysis is to group a set of data points into several clusters based on the similarity or distance. The similarity or distance is usually a scalar used in numerous traditional clustering algorithms. Nevertheless, a vector, such as data gravitational force, contains more information than a scalar and can be applied in clustering analysis to promote clustering performance. Therefore, this paper proposes a three-stage hierarchical clustering approach called GHC, which takes advantage of the vector characteristic of data gravitational force inspired by the law of universal gravitation. In the first stage, a sparse gravitational graph is constructed based on the top k data gravitations between each data point and its neighbors in the local region. Then the sparse graph is partitioned into many subgraphs by the gravitational influence coefficient. In the last stage, the satisfactory clustering result is obtained by merging these subgraphs iteratively by using a new linkage criterion. To demonstrate the performance of GHC algorithm, the experiments on synthetic and real-world data sets are conducted, and the results show that the GHC algorithm achieves better performance than the other existing clustering algorithms.

Abstract:Hierarchical clustering allows better performance in grouping heterogeneous and non-spherical datasets than the center-based clustering, at the expense of increased time complexity. Meanwhile, the bottom-up approach of hierarchical clustering methods often tend to be sensitive or vulnerable to datasets containing obscure cluster boundaries. This paper presents an effective method for hierarchical clustering, called HCNN, which utilizes two types of structural similarities in nearest neighbor graph of a dataset to group similar data into clusters. In particular, the first metric is used to identify those pairs of data with maximal similarity in their nearest neighborhoods that can serve as local centers of every initial cluster. This can contribute to observing the boundaries and detecting clusters, hubs and outliers, thereby alleviating remarkably the influence of obscure boundaries between clusters. The initial clusters will be merged recursively in accordance with the second similarity metric measured in terms of the connectivity between clusters in the nearest neighbor graph. In this case, rather than combining two clusters with highest similarity during each iteration, we consider the maximum similarity as a transitive and closure relation between clusters, i.e., an equivalence relation, which enables more effective and efficient merging of clusters via application of advanced data structures. Experiments based on synthetic and real datasets demonstrate that the proposed HCNN algorithms can possibly outperform the state-of-the-art clustering methods evaluated in terms of the clustering accuracy, normalized mutual information and adjust rand index. Moreover, experiments on unlabeled real datasets show that our method enables effective identification of the quantity of clusters based on Davies–Bouldin index and average silhouette coefficient.

Abstract:The purpose of clustering is to group the data points into several clusters according to their similarity. Inspired by law of gravitation, each data point considered as an object is exposed in data space and influenced by the data gravitation of the other data points. In this paper, a novel hierarchical clustering approach (NGHC) is proposed based on local data gravitation. Firstly, the dataset is partitioned into some clusters as intermediate result by a simple gravity-based clustering approach. Then the intermediate clusters are merged by a new linkage measure which combines the data gravitations between two clusters until the satisfactory result is obtained. Two real-world datasets are used to validate the clustering performance of NGHC compared with five representative clustering algorithms. The results exhibit that the NGHC algorithm obtains the best performance on low- and high-dimensional datasets.

Abstract:<p>Clustering validation and identifying the optimal number of clusters are of great importance in expert and intelligent systems. However, the commonly used similarity measures for validating are not versatile to measure the complex data structure, in reality, some of which are not as effective as that of the used clustering algorithm which gives the clustering results. This paper studies the validity indexes for the hierarchical clustering algorithm and proposes a unified validity index framework. For the single-linkage agglomerative hierarchical clustering we propose two efficient synthetical clustering validity (SCV) indexes using the minimum spanning tree to calculate the intra-cluster compactness to overcome the deficiencies of the measurements in the existing validity indexes. For the general hierarchical clustering, a self-adaptive similarity measure strategy and two generalized synthetical clustering validity (GSCV) indexes, which are the extension of the proposed SCV indexes, are developed. The proposed SCV and GSCV indexes constitute a unified validity index framework, where SCV index is a special case of GSCV index, can avoid the incompatibility of the similarity measure between the clustering and validation. The experimental comparisons with the state-of-the-art validity indexes on artificial and real-world data sets demonstrate the efficiency of the proposed validity indexes in discovering the true number of clusters and dealing with various sorts of data sets, including imbalanced data sets.</p>

Abstract:Although the apriority and randomicity to initiate clustering centers of K-means have been solved by traditional hierarchical k-means clustering algorithm, the algorithm is difficult to be applied widespread popularly owing to its high computational complexity. So a novel clustering algorithm based on hierarchical and K-means clustering, which has good computational complexity, is proposed in this paper. Firstly, the concept of silhouette coefficient is introduced and the optimal clustering number K-opt, included in data set of unknown class information is decided. Then the distribution of data set is gotten through hierarchical clustering and clustering center is decided. Finally, the clustering is completed through K-means clustering. The efficiencies of the algorithm is validated through the test of IRIS testing data set.

Abstract:Many clustering methods have been proposed in the area of data mining, but only few of them focused on the incremental databases. In this paper, an algorithm for hierarchical clustering based on fuzzy graph connectedness algorithm (FHC) is investigated. The presented algorithm applies fuzzy set theory to hierarchical clustering method so as to discover clusters with arbitrary shape. It first partitions the data sets into several sub-clusters using a partitioning method, and then constructs a fuzzy graph of sub-clusters by analyzing the fuzzy-connectedness degree among sub-clusters. By computing the λ cut graph, the connected components of the fuzzy graph can be obtained, hence resulting the desired clustering. The algorithm can be performed in high-dimensional data sets, finding clusters of arbitrary shapes such as the spherical, linear, elongated or concave ones. Also rendered in this research is the incremental algorithm-IFHC applicable to periodically incremental environments. Not only can FHC and IFHC handle data with numerical attributes, but categorical attributes can be dealt with as well. The results of our experimental study for data sets with arbitrary shape and size are very encouraging. The experimental study in web log files is also conducted that can help discover the user access patterns efficiently. The investigation demonstrates that the proposed method generates better quality clusters than traditional algorithms, and scales up well for large databases.

Abstract:Clustering is a fundamental analysis tool aiming at classifying data points into groups based on their similarity or distance. It has found successful applications in all natural and social sciences, including biology, physics, economics, chemistry, astronomy, psychology, and so on. Among numerous existent algorithms, hierarchical clustering algorithms are of a particular advantage as they can provide results under different resolutions without any predetermined number of clusters and unfold the organization of resulted clusters. At the same time, they suffer a variety of drawbacks and thus are either time-consuming or inaccurate. We propose a novel hierarchical clustering approach on the basis of a simple hypothesis that two reciprocal nearest data points should be grouped in one cluster. Extensive tests on data sets across multiple domains show that our method is much faster and more accurate than the state-of-the-art benchmarks. We further extend our method to deal with the community detection problem in real networks, achieving remarkably better results in comparison with the well-known Girvan-Newman algorithm.

A Novel Clustering Oriented Closeness Measure Based on Neighborhood Chain

Abstract:Closeness measures are crucial to clustering methods. In most traditional clustering methods, the closeness between data points or clusters is measured by the geometric distances alone. These metrics quantify the closeness only based on the concerned data points' positions in the feature space, and they might cause problems when dealing with clustering tasks with arbitrary clusters shapes and different clusters scales (varying clusters densities). In this paper, a novel Closeness Measure between data points based on Neighborhood Chain (CMNC) is proposed. Instead of using geometric distances alone, CMNC measures the closeness between data points by quantifying the difficulty for one data point to reach another through a chain of neighbors. Experimental results show that by substituting the geometric-distances-based closeness measures with CMNC, modified versions of the traditional clustering algorithms (e.g. k-means, single-link and CURE) perform much better than their original versions, especially when dealing with clustering tasks with clusters having arbitrary shapes and different scales.

Abstract:Hierarchical clustering algorithm is a very important method in data mining. The disadvantage of hierarchical clustering lies in the time complexity of the algorithm and the one-way irreversibility of the algorithm. The inaccuracy of the conditions for cluster termination is another major disadvantage of hierarchical clustering. Hierarchical clustering requires the final cluster number. But for most datasets, the number of clusters cannot be known in advance. Therefore, a method is proposed to combine the split-based and agglomeration-based hierarchical clustering algorithms to first quickly and uniformly partition the original dataset, and then make similar partitions adaptively merge based on the partition density and partition distance on the basis of these partitions. In this paper, aiming at these defects of hierarchical clustering, a hierarchical clustering algorithm based on fast and uniform segmentation is proposed.

Abstract:Similarity is the core problem of clustering. Clustering algorithms that are based on a certain, fixed type of similarity are not sufficient to explore complicated structures. In this paper, a constructing method for multiple similarity is proposed to deal with complicated structures of data sets. Multiple similarity derives from the local modification of the initial similarity, based on the feedback information of elementary clusters. Combined with the proposed algorithm, the repeated modifications of local similarity measurement generate a hierarchical clustering result. Some synthetic and real data sets are employed to exhibit the superiority of the new clustering algorithm.

Abstract:As an important part of machine learning, clustering methods have been continuously paid attention to. Current clustering methods divide data objects usually based on Euclidean metric, which is a basic and effective metric method. However, with the high dimensionality of data and the diversification of data representation, the complexity of the spatial structure of real-world data continues to rise. Classical clustering methods face many challenges such as insufficient clustering effectiveness, the sensitivity of clustering method parameters, and lack of stability of clustering results. Aiming at the above problems, this paper designs a non-Euclidean metric and constructs a multi-granularity staged clustering method based on the metric. First of all, this paper uses the sequential relationship of each feature of the data to construct a similarity measure between objects from the perspective of positive and negative granularity to improve the clustering algorithm’s understanding of complex spatial structure data. Secondly, this paper designs the attenuation-diffusion pattern divides and conquers according to the distribution characteristics of data objects in different patterns, and uses the heuristic idea to effectively cluster the data in stages from local to global. Again, based on the above, this paper proposes a clustering method based on multi-positive-negative granularity and attenuation-diffusion pattern, which can effectively deal with the challenges brought by complex spatial structure data to clustering methods. Finally, the effectiveness and robustness of the proposed method and advanced clustering methods are compared and analyzed on UCI real data sets. Experimental results show that the method proposed in this paper has obvious advantages in clustering results on complex spatial structure data. In addition, in the two directions of non-Euclidean metrics and multi-granularity clustering, the method proposed in this paper provides a new perspective for effectively dealing with the design of clustering methods on complex spatial structure data.
A new distance measurement and its application in K-Means Algorithm

Abstract:K-Means clustering algorithm is one of the most commonly used clustering algorithms because of its simplicity and efficiency. K-Means clustering algorithm based on Euclidean distance only pays attention to the linear distance between samples, but ignores the overall distribution structure of the dataset (i.e. the fluid structure of dataset). Since it is difficult to describe the internal structure of two data points by Euclidean distance in high-dimensional data space, we propose a new distance measurement, namely, view-distance, and apply it to the K-Means algorithm. On the classical manifold learning datasets, S-curve and Swiss roll datasets, not only this new distance can cluster the data according to the structure of the data itself, but also the boundaries between categories are neat dividing lines. Moreover, we also tested the classification accuracy and clustering effect of the K-Means algorithm based on view-distance on some real-world datasets. The experimental results show that, on most datasets, the K-Means algorithm based on view-distance has a certain degree of improvement in classification accuracy and clustering effect.

Abstract:Clustering plays a pivotal role in knowledge processing, knowledge bases, and expert systems, enabling AI systems to acquire knowledge effectively. Hierarchical clustering, in particular, offers an intelligent approach to represent knowledge hierarchically by transforming raw data into one/multiple tree-shaped components. However, a notable difficulty arises when attempting to pinpoint appropriate representative points within lower levels of the cluster tree. These points are of paramount importance, as they serve as the roots for subsequent aggregation within the upper levels of the cluster tree. Traditional hierarchical clustering algorithms have relied on rudimentary techniques to select these representative points, which may not provide an adequate representation. Consequently, the resulting cluster tree often falls short in terms of empirical performance. To address this shortcoming, we proposed an innovative hierarchical clustering algorithm in this paper. The proposed algorithm is designed to efficiently identify the representative point within each sub-minimum-spanning-tree during the construction of the cluster tree, achieved by topology-based scoring the reciprocal nearest data points. Rigorous testing on UCI datasets has demonstrated the superior clustering accuracy (measured by Rand Index and Normalized Mutual Information) of our proposed algorithm compared to other benchmark algorithms. Further analysis reveals that our algorithm boasts a O(nlogn) time-complexity and a O(logn) space-complexity, indicating its scalability and efficiency in handling large-scale data with minimal time and storage costs. Importantly, our algorithm's ability to process up to two million data points on a standard personal computer underscores its cost-effectiveness.

Abstract:In actual databases, there are a lot of hierarchy coding data, existing clustering algorithms don't consider the special treatment of these data structure, so lead nonideal performance and clustering result. This paper proposes a new clustering algorithm to deal with the hierarchy coding data structure (HCDS) that exists in many applications. The main contributions include: (1) proposes a new concept for HCDS and corresponding definitions. (2) Proposes and implements a new clustering algorithm---CHCC (Coding Hierarchy Computing Based Clustering Algorithm) based on HCDS. (3) Proposes a fast algorithm for hierarchy coding structure processing. (4) Applies the algorithm into the clustering analysis of transient population for public security, and through extensive experiments, proves the validity and efficiency of the algorithm.

Abstract:Clustering is a promising application area for many fields including statistics,pattern recognition,(data)mining,etc.The effectiveness and efficiency of existing clustering techniques,however,is somewhat limited,owing to the huge amounts data collected in databases.According the theory of fields in physics,a hierarchical clustering method based on data fields is presented.The basic idea is that the field models is introduced to describe the virtual interaction among data objects in data space and the hierarchical partitioning of the original dataset is then performed by iteratively simulating the interaction and movement of the data objects in the fields.Experimental results show that the proposed approach not only enjoys favorite clustering quality and requires no careful parameters tuning,but also has a time complexity approximately linear with respect to the size of dataset.
