Abstract:The passive detection performance of an autonomous underwater vehicle (AUV) is affected by various types of noise. One of the main components of the noise is the AUV's self-noise. Inspired by the statistical reasoning shown in Noise2Noise, we propose a deep learning model for AUV's self-noise suppression. It can learn the spectrum features of the noise from single-channel data in a self-supervised learning setting and reconstruct clean signals. The tests on South China Sea experimental dataset show that the model is able to intelligently suppress AUV's self-noise for single hydrophone signals.

Self-Supervised Attenuation Method Based on Similarity Comparisons for 3D Seismic Random Noise

Abstract:The improvement of the signal-to-noise ratio of seismic data is crucial for high-precision processing. The self-supervised denoising methods based on correlation differences are gaining attention due to their low cost of training data construction and the ability to build training data directly on test data. However, as the volume of data processed increases, these methods must maintain a denoising effect by adding extra processings. This increase in processing times can lead to a rise in total cost, making these methods less cost-effective compared to other deep learning methods for processing large data. Therefore, we improved these self-supervised methods by altering the training data construction process, thereby retaining its cost advantage. Specifically, we modified the selection process of zones used for training data construction. Through correlation analysis, these methods can obtain higher-quality zones from the original zone for training, indicating that the network needs to be trained only once to process any data in the original zone. Without the requirement for additional processing to ensure noise attenuation, these self-supervised methods can maintain their cost advantage when processing large data. We applied one of these self-supervised methods to synthetic and field examples to demonstrate the enhancement's effectiveness. Experimental results show that the improved method performs as well as the conventional self-supervised method in suppressing random noise and constructing reflection events but with a significant cost advantage.

Abstract:Seismic data denoising has gained much attention from scholars as a crucial part of seismic data processing. With the development of deep learning technology, numerous algorithms well employed in natural image denoising have been used for seismic data denoising. However, seismic data are crucially an array of geophone vibration signals, which have numerous unique structural properties compared with natural images. Thus, employing the traditional image algorithms rather than those developed specifically for seismic data is inadequate to extract all seismic features. In addition, compared with natural images, it is difficult to acquire noise-free ground truth, which restricts the use of supervised deep learning approaches in seismic data denoising. To this end, a self-supervised intertrace seismic data denoising network (STSNet) that requires only one seismic section for random noise attenuation is proposed. Furthermore, we adopt a single-trace vibration signal as the basic unit and fully consider the characteristics of seismic signals. This is the first time to introduce a self-learning spatial attention mechanism among seismic traces to focus on the noise components, which prompts the network's fitting performance. Different comparative experiments demonstrate that our approach can achieve exceptional denoising performance even if only observing a single seismic section. In addition, the ablation experiments also confirm the efficiency of spatial attention.

An effective self-supervised learning method for various seismic noise attenuation

Abstract:Faced with the scarcity of clean label data in real scenarios, seismic denoising methods based on supervised learning (SL) often encounter performance limitations. Specifically, when a model trained on synthetic data is directly applied to field data, its performance would drastically decline due to significant differences in feature distributions between the two. To address this challenge, we develop an effective self-supervised strategy. This strategy, while relying on a single denoising network model, adeptly attenuates various types of seismic noise. The strategy comprises two main phases: 1. The warm-up phase. By using prior knowledge or extracting information from real data, we introduce additional noise to the original noisy data, constructing a noisier data with intensified noise. This data serves as the input, with the original noisy data acting as pseudo-labels. This facilitates rapid pre-training of the network to capture a certain noise characteristics and boosts network stability, setting the stage for the subsequent phase. 2. Iterative data refinement (IDR) phase. During this phase, we use the predictions of the original noisy data from the network trained in the previous epoch as the pseudo-labels. We continue to add noise to the predictions, creating a new noisier-noisy dataset for the current epoch of network training. Through this iterative process, we progressively reduce the discrepancy between the original noisy data and the desired clean data. Ultimately, the network's predictions on the original noisy data become our denoised results. Validations under scenarios with random noise, backscattered noise, and blending noise reveal that our method not only matches the traditional SL techniques on synthetic data but significantly outperforms them on field data.

Abstract:Random noise attenuation is an essential step to improve the signal-to-noise ratio (SNR) of seismic data. Deep learning for seismic data denoising is dominated by supervised methods that require noise-free data as training targets. It is usually time-consuming and laborious to obtain such clean seismic data, and the effectiveness of the noise attenuation is difficult to be guaranteed. Therefore, we propose a novel unsupervised learning method that learns from noisy data. The method is based on two salient features of seismic data: 1) valid signals of adjacent seismic traces that are spatially correlated and 2) random noise that is spatially independent and unpredictable. An end-to-end deep convolutional neural network (CNN) was constructed to solve the denoising task. Adjacent traces of seismic data, which contain similar seismic phases and interface features, were used as the inputs and labels of the training set. The mapping of spatial correlation can be learned by the CNN so that valid signals from raw seismic data are predicted, while random noise is suppressed for unpredictability. Synthetic and field data were applied to the proposed CNN denoising model. The experimental results demonstrate the effectiveness of random noise attenuation while preserving amplitude compared with two commonly used state-of-the-art denoising methods.

Abstract:Empirical mode decomposition (EMD) becomes attractive recently for random noise attenuation because of its convenient implementation and ability in dealing with non-stationary seismic data. In this paper, we summarize the existing use of EMD in seismic data denoising and introduce a general hybrid scheme which combines f - x EMD with a dipping-events retrieving operator. The novel hybrid scheme can achieve a better denoising performance compared with the conventional f - x EMD and selected dipping event retriever. We demonstrate the strong horizontal-preservation capability of f - x EMD that makes the EMD based hybrid approach attractive. When f - x EMD is applied to a seismic profile, all the horizontal events will be preserved, while leaving few dipping events and random noise in the noise section, which can be dealt with easily by applying a dipping-events retrieving operator to a specific region for preserving the useful dipping signal. This type of incomplete hybrid approach is termed a selective hybrid approach. Two synthetic and one post-stack field data examples demonstrate a better performance of the proposed approach.

Abstract:Microseismic monitoring data may be seriously contaminated by complex and nonstationary interference noises produced by mechanical vibration, which significantly impact the data quality and subsequent data-processing procedure. One challenge in microseismic data processing is separating weak seismic signals from varying noisy data. To address this issue, we proposed an ambient-noise-assisted multivariate empirical mode decomposition (ANA-MEMD) method for adaptively suppressing noise in low signal-to-noise (S/N) microseismic data. In the proposed method, a new multi-channel record is produced by combining the noisy microseismic signal with preceding ambient noises. The multi-channel record is then decomposed using multivariate empirical mode decomposition (MEMD) into multivariate intrinsic mode functions (MIMFs). Then, the MIMFs corresponding to the main ambient noises can be identified by calculating and sorting energy percentage in descending order. Finally, the IMFs associated with strong interference noise, high-frequency and low-frequency noise are filtered out and suppressed by the energy percentage and frequency range. We investigate the feasibility and reliability of the proposed method using both synthetic data and field data. The results demonstrate that the proposed method can mitigate the mode mixing problem and clarify the main noise contributors by adding additional ambient-noise-assisted channels, hence separating the microseismic signal and ambient noise effectively and enhancing the S/Ns of microseismic signals.

Abstract:Denoising seismic data is a crucial step in seismic data processing to enhance the signal-to-noise ratio of data because random noise is inevitably introduced during seismic data acquisition owing to environmental factors. In this study, we introduce a symmetric skip-connected denoising method (A-SK22) based on a hybrid attention mechanism with a hybrid pool to attenuate noise in seismic data. The proposed method adopts the coding-decoding network structure of the U-Net network. In the encoding phase, hybrid pooling is employed to reconstruct seismic data more effectively, mitigating the risk of partial loss of valid information during down-sampling. The network structure of hybrid pooling consists of a parallel arrangement of the average and maximum pooling. In the skip-link part, the sum operation, which reduces the computational cost, is adopted. Meanwhile, in pursuit of further mining the spatial and channel information of the seismic data, we added the global attention mechanism in the skip linking part. The recovery experiments conducted with synthetic and actual seismic data demonstrate the effectiveness of the proposed method in attenuating random noise while causing minimal distortion to essential seismic signals.

Abstract:Effective random noise attenuation is critical for subsequent processing of seismic data, such as velocity analysis, migration, and inversion. Thus, the removal of seismic random noise with an uncertainty level is meaningful. Attenuating 3-D random noise in a supervised way based on deep learning (DL) is challenging because clean labels are difficult to obtain. Therefore, it is necessary to develop an adaptive unsupervised-based method for random noise attenuation. In this article, we propose a deep-denoising unsupervised learning (DDUL) network to attenuate random noise in 2-D/3-D seismic data. A patching technique is used to split 2-D/3-D seismic data into several patches to be fed into the network, which helps to expand the number of samples for training. We use the fully symmetrical structure of the autoencoder to construct the network. In each corresponding encoder and decoder layer, skip connections are added to enhance the learning of seismic data features. We construct three blocks to extract waveform features in seismic data, i.e., encoder, decoder, and skip blocks. Among them, the skip is connected between the encoder and decoder blocks of each hidden layer. The use of multiple blocks not only improves the network's ability to extract seismic data features but also solves the problem of excessive training parameters caused by hidden layer stacking. Five 2-D/3-D synthetic and field seismic datasets are used to test the denoising performance of our proposed method. The denoising results demonstrate that our proposed method has good signal-preserving and noise attenuation capabilities in real-world applications.

A self-supervised scheme for ground roll suppression

Abstract:In recent years, self-supervised procedures have advanced the field of seismic noise attenuation, due to not requiring a massive amount of clean labeled data in the training stage, an unobtainable requirement for seismic data. However, current self-supervised methods usually suppress simple noise types, such as random and trace-wise noise, instead of the complicated, aliased ground roll. Here, we propose an adaptation of a self-supervised procedure, namely, blind-fan networks, to remove aliased ground roll within seismic shot gathers without any requirement for clean data. The self-supervised denoising procedure is implemented by designing a noise mask with a predefined direction to avoid the coherency of the ground roll being learned by the network while predicting one pixel's value. Numerical experiments on synthetic and field seismic data demonstrate that our method can effectively attenuate aliased ground roll.

Abstract:In the geophysical field, seismic noise attenuation has been considered as a critical and long-standing problem, especially for the pre-stack data processing. Here, we propose a model to leverage the deep-learning model for this task. Rather than directly applying an existing de-noising model from ordinary images to the seismic data, we have designed a particular deep-learning model, based on residual neural networks. It is named as N2N-Seismic, which has a strong ability to recover the seismic signals back to intact condition with the preservation of primary signals. The proposed model, achieving with great success in attenuating noise, has been tested on two different seismic datasets. Several metrics show that our method outperforms conventional approaches in terms of Signal-to-Noise-Ratio, Mean-Squared-Error, Phase Spectrum, etc. Moreover, robust tests in terms of effectively removing random noise from any dataset with strong and weak noises have been extensively scrutinized in making sure that the proposed model is able to maintain a good level of adaptation while dealing with large variations of noise characteristics and intensities.

Abstract:Seismic swell noise, often observed in marine seismic data, is characterized by high amplitude and low frequencies. This noise significantly hides useful signals, underscoring the importance of attenuating it in the processing pipeline for marine seismic data. To date, most deep learning methods proposed for swell noise suppression have focused on supervised paradigms, which require a large dataset of paired noisy and clean data to gain insights into signal features and swell noise statistics at the training phase. In field data processing, however, obtaining generalizable training data often proves to be challenging. The inherent complexity and variability of the real world often make it difficult to acquire unbiased, noise-free datasets in the context of marine seismic data processing. To address this problem, we present a self-supervised deep learning method for suppressing swell noise even in the absence of access to clean seismic training data. First, we propose a strategy for the synthetic swell noise generation based on the amplitude, frequency, and coherence features of noisy traces. We implement the noisy-as-clean (NAC) strategy, wherein either the original noisy seismic data or its reorganized variant acts as the network's target. Simultaneously, the network receives the observed noisy seismic data combined with simulated swell noise as its input. By leveraging these "noisy-noisy" pairs, we train a DnCNN network. Experimental evaluations conducted on both synthetic and field data demonstrate that, through the integration of swell noise simulation and the NAC strategy, the trained network consistently achieves superior denoising performance.

Noise Suppression for CRP Gathers Based on Self2Self with Dropout

Abstract:Noise suppression in seismic data processing is a crucial research focus for enhancing subsequent imaging and reservoir prediction. Deep learning has shown promise in computer vision and holds significant potential for seismic data processing. However, supervised learning, which relies on clean labels to train network prediction models, faces challenges due to the unavailability of clean labels for seismic exploration data. In contrast, self-supervised learning substitutes traditional supervised learning with surrogate tasks by different auxiliary means, exploiting internal input data information. Inspired by Self2Self with Dropout, this paper presents a self-supervised learning-based noise suppression method called Self-Supervised Deep Convolutional Networks (SSDCN), specifically designed for Common Reflection Point (CRP) gathers. We utilize pairs of Bernoulli-sampled instances of the input noisy image as surrogate tasks to leverage its inherent structure. Furthermore, SSDCN incorporates geological knowledge through the normal moveout correction technique, which capitalizes on the approximately horizontal behavior and strong self-similarity observed in useful signal events within CRP gathers. By exploiting the discrepancy in self-similarity between the useful signals and noise in CRP gathers, SSDCN effectively extracts self-similarity features during training iterations, prioritizing the extraction of useful signals to achieve noise suppression. Experimental results on synthetic and actual CRP gathers demonstrate that SSDCN achieves high-fidelity noise suppression.

A Fully Unsupervised and Highly Generalized Deep Learning Approach for Random Noise Suppression

Abstract:ABSTRACTIn this study, we proposed a deep learning algorithm (PATCHUNET) to suppress random noise and preserve the coherent seismic signal. The input data are divided into several patches, and each patch is encoded to extract the meaningful features. Following this, the extracted features are decompressed to retrieve the seismic signal. Skip connections are used between the encoder and decoder parts, allowing the proposed algorithm to extract high‐order features without losing important information. Besides, dropout layers are used as regularization layers. The dropout layers preserve the most meaningful features belonging to the seismic signal and discard the remaining features. The proposed algorithm is an unsupervised approach that does not require prior information about the clean signal. The input patches are divided into 80% for training and 20% for testing. However, it is interesting to find that the proposed algorithm can be trained with only 30% of the input patches with an effective denoising performance. Four synthetic and four field examples are used to evaluate the proposed algorithm performance, and compared to the deconvolution and the singular spectrum analysis. The results indicate the ability of the proposed algorithm in attenuating the random noise and preserving the seismic signal effectively despite the existence of a large amount of random noise, for example, when the input signal‐to‐noise ratio is as low as −14.2 dB.
Non-stationary Least-Squares Complex Decomposition for Microseismic Noise Attenuation

Abstract:Microseismic data processing and imaging are crucial for subsurface real-time monitoring during hydraulic fracturing process. Unlike the active-source seismic events or large-scale earthquake events, the microseismic event is usually of very small magnitude, which makes its detection challenging. The biggest trouble of microseismic data is the low signal-to-noise ratio issue. Because of the small energy difference between effective microseismic signal and ambient noise, the effective signals are usually buried in strong random noise. I propose a useful microseismic denoising algorithm that is based on decomposing a microseismic trace into an ensemble of components using least-squares inversion. Based on the predictive property of useful microseismic event along the time direction, the random noise can be filtered out via least-squares fitting of multiple damping exponential components. The method is flexible and almost automated since the only parameter needed to be defined is a decomposition number. I use some synthetic and real data examples to demonstrate the potential of the algorithm in processing complicated microseismic data sets.

Abstract:Distributed Acoustic Sensing (DAS) is an emerging technology for earthquake monitoring and subsurface imaging. However, its distinct characteristics, such as unknown ground coupling and high noise level, pose challenges to signal processing. Existing machine learning models optimized for conventional seismic data struggle with DAS data due to its ultra-dense spatial sampling and limited manual labels. We introduce a semi-supervised learning approach to address the phase-picking task of DAS data. We use the pre-trained PhaseNet model to generate noisy labels of P/S arrivals in DAS data and apply the Gaussian mixture model phase association (GaMMA) method to refine these noisy labels and build training datasets. We develop PhaseNet-DAS, a deep learning model designed to process 2D spatio-temporal DAS data to achieve accurate phase picking and efficient earthquake detection. Our study demonstrates a method to develop deep learning models for DAS data, unlocking the potential of integrating DAS in enhancing earthquake monitoring.

Abstract:Random noise attenuation is one of the most essential steps in seismic signal processing. We propose a novel approach to attenuate seismic random noise based on deep convolutional neural network (CNN) in an unsupervised learning manner. First, normalization and patch sampling are required to build training dataset and test dataset from raw noisy data. Instead of using synthetic noise-free data or denoised results via conventional methods as training labels, we adopt only the training set constructed from the raw noisy data as the input and design a robust deep CNN that just relies on the noisy input to learn the hidden features. The cross-entropy is chosen as the error criterion for establishing the cost function, which is minimized by the back-propagation algorithm to obtain the optimized parameters of the network. Then, we can reconstruct all patches of the test dataset via the optimized CNN. After patching processing and inverse normalization, the final denoised result can be obtained from reconstructed patches. Experimental tests on synthetic and real data demonstrate the effectiveness and superiority of the proposed method compared with state-of-the-art denoising methods.
