Abstract:The passive detection performance of an autonomous underwater vehicle (AUV) is affected by various types of noise. One of the main components of the noise is the AUV's self-noise. Inspired by the statistical reasoning shown in Noise2Noise, we propose a deep learning model for AUV's self-noise suppression. It can learn the spectrum features of the noise from single-channel data in a self-supervised learning setting and reconstruct clean signals. The tests on South China Sea experimental dataset show that the model is able to intelligently suppress AUV's self-noise for single hydrophone signals.
Dropout-Based Robust Self-Supervised Deep Learning for Seismic Data Denoising

Abstract:Incoherent noise suppression is an indispensable step in seismic data processing. Recently, deep learning (DL) methods have gained commendable success in seismic data denoising, one of which is the supervised DL denoising method using clean data as the training label, whereas the cost of obtaining clean data is high. We investigate a robust self-supervised DL denoising method without using clean data. Bernoulli-sampled training pairs of the raw noisy data produced by the dropout layer are served to train the NN, and a Monte Carlo (MC) self-integrated technique results in further improving the denoising quality of the trained NN during the testing. Compared with the f-x deconvolution (FXDECON), deep image prior (DIP), and sparse autoencoder (SAE) methods via synthetic and real data examples, the proposed method outperforms these methods for enhancing the signal-to-noise ratio (SNR) and reducing the signal loss.

We compare the MCNN training results with the denoising convolutional neural networks (DnCNN) training results. The denoising results of synthetic noisy seismic records and field seismic records show that MCNN can effectively remove the noise and has a better denoising performance than DnCNN, which verifies the feasibility and advantages of MCNN denoising. A Denoising Method for Seismic Data Based on SVD and Deep Learning

Abstract:When reconstructing seismic data, the traditional singular value decomposition (SVD) denoising method has the challenge of difficult rank selection. Therefore, we propose a seismic data denoising method that combines SVD and deep learning. In this method, seismic data with different signal-to-noise ratios (SNRs) are processed by SVD. Data sets are created from the decomposed right singular vectors and data sets divided into two categories: effective signal and noise. The lightweight MobileNetV2 network was chosen for training because of its quick response speed and great accuracy. We forecasted and categorized the right singular vectors by SVD using the trained MobileNetV2 network. The right singular vector (RSV) corresponding to the noise in the seismic data was removed during reconstruction, but the effective signal was kept. The effective signal was projected to smooth the RSV. Finally, the goal of low SNR denoising of two-dimensional seismic data was accomplished. This approach addresses issues with deep learning in seismic data processing, including the challenge of gathering sample data and the weak generalizability of the training model. Compared with the traditional denoising method, the improved denoising method performs well at removing Gaussian and irregular noise with strong amplitudes.

Abstract:In recent years, supervised-deep-learning methods have shown some advantages over conventional methods in seismic data denoising, such as higher signal-to-noise ratio after denoising, complete separation of signals and noise in shared frequency bands and intelligent denoising without artificial parameter tuning. However, the lack of real noise data matched with raw seismic data has greatly limited its further application. In this paper, we take the surface seismic shot gather as an example to explore the corresponding solutions and propose a novel supervised-deep-learning method with weak dependence on real noise data based on the data augmentation of a generative adversarial network. We utilize the generative adversarial network to augment the pre-arrival noise data acquired from the shot gather itself, thereby obtaining a large amount of synthetic noise data whose probability distribution is extremely similar to that of the real noise in shot gather; the augmented synthetic noise data and sufficient synthetic signal data obtained by forward modeling together form the augmented training dataset. Meanwhile, the dilated convolution and gradual denoising strategy are adopted to construct the basic architecture of denoising convolution neural network. Finally, the above augmented dataset is used to train the network, so as to establish a nonlinear and complex mapping relationship between raw seismic data and desired signals. Both synthetic and real experiments demonstrate that our method can realize the intelligent denoising of different common-shot-point records in shot gather with the help of limited pre-arrival noise data.

Attenuating Random Noise in Seismic Data by a Deep Learning Approach

Abstract:In the geophysical field, seismic noise attenuation has been considered as a critical and long-standing problem, especially for the pre-stack data processing. Here, we propose a model to leverage the deep-learning model for this task. Rather than directly applying an existing de-noising model from ordinary images to the seismic data, we have designed a particular deep-learning model, based on residual neural networks. It is named as N2N-Seismic, which has a strong ability to recover the seismic signals back to intact condition with the preservation of primary signals. The proposed model, achieving with great success in attenuating noise, has been tested on two different seismic datasets. Several metrics show that our method outperforms conventional approaches in terms of Signal-to-Noise-Ratio, Mean-Squared-Error, Phase Spectrum, etc. Moreover, robust tests in terms of effectively removing random noise from any dataset with strong and weak noises have been extensively scrutinized in making sure that the proposed model is able to maintain a good level of adaptation while dealing with large variations of noise characteristics and intensities.

Abstract:Random noise attenuation is an essential step to improve the signal-to-noise ratio (SNR) of seismic data. Deep learning for seismic data denoising is dominated by supervised methods that require noise-free data as training targets. It is usually time-consuming and laborious to obtain such clean seismic data, and the effectiveness of the noise attenuation is difficult to be guaranteed. Therefore, we propose a novel unsupervised learning method that learns from noisy data. The method is based on two salient features of seismic data: 1) valid signals of adjacent seismic traces that are spatially correlated and 2) random noise that is spatially independent and unpredictable. An end-to-end deep convolutional neural network (CNN) was constructed to solve the denoising task. Adjacent traces of seismic data, which contain similar seismic phases and interface features, were used as the inputs and labels of the training set. The mapping of spatial correlation can be learned by the CNN so that valid signals from raw seismic data are predicted, while random noise is suppressed for unpredictability. Synthetic and field data were applied to the proposed CNN denoising model. The experimental results demonstrate the effectiveness of random noise attenuation while preserving amplitude compared with two commonly used state-of-the-art denoising methods.

Noise Suppression for CRP Gathers Based on Self2Self with Dropout

Abstract:Noise suppression in seismic data processing is a crucial research focus for enhancing subsequent imaging and reservoir prediction. Deep learning has shown promise in computer vision and holds significant potential for seismic data processing. However, supervised learning, which relies on clean labels to train network prediction models, faces challenges due to the unavailability of clean labels for seismic exploration data. In contrast, self-supervised learning substitutes traditional supervised learning with surrogate tasks by different auxiliary means, exploiting internal input data information. Inspired by Self2Self with Dropout, this paper presents a self-supervised learning-based noise suppression method called Self-Supervised Deep Convolutional Networks (SSDCN), specifically designed for Common Reflection Point (CRP) gathers. We utilize pairs of Bernoulli-sampled instances of the input noisy image as surrogate tasks to leverage its inherent structure. Furthermore, SSDCN incorporates geological knowledge through the normal moveout correction technique, which capitalizes on the approximately horizontal behavior and strong self-similarity observed in useful signal events within CRP gathers. By exploiting the discrepancy in self-similarity between the useful signals and noise in CRP gathers, SSDCN effectively extracts self-similarity features during training iterations, prioritizing the extraction of useful signals to achieve noise suppression. Experimental results on synthetic and actual CRP gathers demonstrate that SSDCN achieves high-fidelity noise suppression.

Abstract:Due to human or environmental factors, random noise will inevitably be introduced during seismic data acquisition. Contaminated seismic data seriously affect subsequent seismic data processing and imaging. In this paper, we propose a deep convolutional autoencoder neural network for denoising, which consists of encoding and decoding frameworks. The encoding framework consisting of convolution layers and pooling layers captures features of seismic data while eliminating noise. The decoding framework consisting of convolution layers and upsampling layers is capable of enlarging the feature map and recovering the small scale features of the seismic data. In order to represent the characteristics of seismic data optimally, we introduce L1 regularization to constrain the weights. In order to learn multi-scale features of seismic data, we use the multiple filters with different sizes in both encoding and decoding frameworks. The proposed method is tested on synthetic and field cases. The experimental results show that the proposed denoising method can suppress random noise effectively.

Abstract:Noise suppression for seismic data can meliorate the quality of many subsequent geophysical tasks. In this work, we propose a novel self-supervised learning method, the deep nonlocal regularizer (DNLR), for 3-D seismic denoising. Our DNLR fully exploits the nonlocal self-similarity (NSS) of seismic data under a self-supervised learning framework for noise attenuation. It can be flexibly combined with different hand-crafted regularizers, e.g., total variation (TV), nuclear norm (NN), and correlated TV (CTV), by performing the regularizer on nonlocal self-similar patches, which more effectively characterizes the intrinsic structures underlying seismic data. Our DNLR can be easily plugged into existing self-supervised denoising methods, e.g., deep image prior (DIP) and Self2Self (S2S), and consistently improve their performance. To make the optimization model tractable, an algorithm based on the alternating direction multiplier method (ADMM) is introduced to solve the DNLR-based seismic denoising problem. Extensive seismic denoising experiments on synthetic and field data validate the superior performances of our DNLR as compared with state-of-the-art model-based and deep learning seismic denoising methods. Abstract:Seismic data denoising has gained much attention from scholars as a crucial part of seismic data processing. With the development of deep learning technology, numerous algorithms well employed in natural image denoising have been used for seismic data denoising. However, seismic data are crucially an array of geophone vibration signals, which have numerous unique structural properties compared with natural images. Thus, employing the traditional image algorithms rather than those developed specifically for seismic data is inadequate to extract all seismic features. In addition, compared with natural images, it is difficult to acquire noise-free ground truth, which restricts the use of supervised deep learning approaches in seismic data denoising. To this end, a self-supervised intertrace seismic data denoising network (STSNet) that requires only one seismic section for random noise attenuation is proposed. Furthermore, we adopt a single-trace vibration signal as the basic unit and fully consider the characteristics of seismic signals. This is the first time to introduce a self-learning spatial attention mechanism among seismic traces to focus on the noise components, which prompts the network's fitting performance. Different comparative experiments demonstrate that our approach can achieve exceptional denoising performance even if only observing a single seismic section. In addition, the ablation experiments also confirm the efficiency of spatial attention.

Seismic data denoising and deblending using deep learning

Abstract:An important step of seismic data processing is removing noise, including interference due to simultaneous and blended sources, from the recorded data. Traditional methods are time-consuming to apply as they often require manual choosing of parameters to obtain good results. We use deep learning, with a U-net model incorporating a ResNet architecture pretrained on ImageNet and further trained on synthetic seismic data, to perform this task. The method is applied to common offset gathers, with adjacent offset gathers of the gather being denoised provided as additional input channels. Here we show that this approach leads to a method that removes noise from several datasets recorded in different parts of the world with moderate success. We find that providing three adjacent offset gathers on either side of the gather being denoised is most effective. As this method does not require parameters to be chosen, it is more automated than traditional methods.

Abstract:Deep-learning-based methods have been successfully applied to seismic data random noise attenuation. Among them, the supervised deep-learning-based methods dominate the unsupervised ones. The supervised methods need accurate noise-free data as training labels. However, the field seismic data cannot meet this requirement. To circumvent it, some researchers utilized realistic-looking synthetic data or denoised results via conventional methods as labels. The former ones encounter the problem of weak generalization ability because it requires the same distribution of test and training data. The latter ones encounter the issue of insufficient denoising ability because its denoising ability is difficult to significantly exceed the conventional methods which were used to generate labels. To avoid preparing noise-free labels, we propose a novel deep learning framework for attenuating random noise of prestack seismic data in an unsupervised manner. The prestack seismic data, such as common-reflection-point (CRP) gathers and common-midpoint (CMP) gathers after normal moveout (NMO) correction, have high self-similarity. It is because their events are coherent in the time–space domain and approximately horizontal from shallow to deep layers. The generator convolutional neural network (GCN) first learns self-similar features before any learning. The useful signals are more self-similar than random noise, which is incoherent and randomly distributed. Therefore, the GCN extracts features of useful signals before random noise. We select the specific training iteration and adopt the early stopping strategy to suppress random noise. Both synthetic and field prestack seismic data examples demonstrate the validity of our methods.
Deep Learning Denoising Applied to Regional Distance Seismic Data in Utah

Abstract:ABSTRACT Seismic waveform data are generally contaminated by noise from various sources. Suppressing this noise effectively so that the remaining signal of interest can be successfully exploited remains a fundamental problem for the seismological community. To date, the most common noise suppression methods have been based on frequency filtering. These methods, however, are less effective when the signal of interest and noise share similar frequency bands. Inspired by source separation studies in the field of music information retrieval (Jansson et al., 2017) and a recent study in seismology (Zhu et al., 2019), we implemented a seismic denoising method that uses a trained deep convolutional neural network (CNN) model to decompose an input waveform into a signal of interest and noise. In our approach, the CNN provides a signal mask and a noise mask for an input signal. The short-time Fourier transform (STFT) of the estimated signal is obtained by multiplying the signal mask with the STFT of the input signal. To build and test the denoiser, we used carefully compiled signal and noise datasets of seismograms recorded by the University of Utah Seismograph Stations network. Results of test runs involving more than 9000 constructed waveforms suggest that on average the denoiser improves the signal-to-noise ratios (SNRs) by ∼5 dB, and that most of the recovered signal waveforms have high similarity with respect to the target waveforms (average correlation coefficient of ∼0.80) and suffer little distortion. Application to real data suggests that our denoiser achieves on average a factor of up to ∼2–5 improvement in SNR over band-pass filtering and can suppress many types of noise that band-pass filtering cannot. For individual waveforms, the improvement can be as high as ∼15 dB.

Abstract:Suppression of seismic random noise is one critical step in seismic data processing. In recent years, the outstanding ability of deep learning to denoise seismic data is impressive. Unsupervised Deep Image Prior (DIP) model has achieved promising denoising results without training label. However, during training, these models first learn the effective seismic events in the noisy data, and then pick up the random noise afterwards, i.e., overfitting. Thus, the practicability of DIP hinges on good early stopping (ES) that catches the potentially noise free seismic data. In this respect, the majority of DIP works only demonstrate potential of the models by showing the peak performance accessing the ground truth as reference, but provides no clue about how to operationally catch near-peak output without the ground truth. In this paper, we investigate the ES strategy in seismic data denoising using DIP method, which consistently detects the performance of reconstruction sequence by observing its running variance (VAR). The adopted ES method incurs low computational overhead. Numerical tests on 2D/3D synthetic and field data demonstrate that compared with other stopping criteria, the ES method exhibits superiority in suppressing random noise and preserves the effective signals better.

Robust unsupervised 5D seismic data reconstruction on both regular and irregular grid

Abstract:Seismic data reconstruction in five dimensions (5D) has become a central focus in seismic data processing, addressing challenges posed by irregular sampling due to physical and budgetary constraints. Most traditional high-dimensional reconstruction methods commonly utilize the fast Fourier transform (FFT), requiring regular grids and preliminary 4D binning before 5D interpolation. Discrete Fourier transform and non-equidistant FFT can honour original irregular coordinates. However, when using exact locations, these methods become computationally expensive. This study introduces an unsupervised deep-learning methodology to learn a continuous function across sampling points in seismic data, facilitating reconstruction on both regular and irregular grids. The network comprises a multilayer perceptron (MLP) with linear layers and element-wise periodic activation functions. It excels at mapping input coordinates to corresponding seismic data amplitudes without relying on external training sets. The networks intrinsic low-frequency bias is crucial in prioritizing acquiring self-similar features over high-frequency, incoherent ones during training. This characteristic mitigates incoherent noise in seismic data, including random and erratic components. To assess the robustness of the unsupervised reconstruction technique, we conduct comprehensive evaluations using synthetic data examples sampled both regularly and irregularly, as well as field-data examples with and without binning. The findings demonstrate the efficacy of the proposed deep-learning framework in achieving resilient and accurate seismic data reconstruction across diverse sampling scenarios.

A Convolutional Autoencoder Method for Simultaneous Seismic Data Reconstruction and Denoising

Abstract:Petroleum geophysical exploration is based on seismic data and has been widely affected by deep learning technology in recent years. As a consequence of the high efficiency and nonlinear fitting ability of deep learning models, we propose an improved convolutional autoencoder (CAE) method to achieve simultaneous reconstruction and denoising of seismic data. The architecture of the improved CAE is based on group convolution and inception structures, which have powerful feature extraction capabilities for seismic data. The CAE method regards the reconstruction and denoising of seismic data as a feature extraction process of the target seismic signals; this enables the method to simultaneously reconstruct the seismic signal accurately and suppress the random noise mixed in the seismic data. During the training of the CAE, the mean absolute error (MAE) loss function and Adam optimization algorithm were used. Because this is a data-driven method and does not require the threshold to be input manually, it can process a large amount of seismic data quickly and intelligently. Synthetic and field data examples demonstrate the effectiveness of the CAE method.

Abstract:With the development of seismic exploration technology, distributed acoustic sensing (DAS) has recently received attention in geophysics. However, owing to the complexity of the layout techniques in the DAS systems, and the unknown or harsh exploration environment, seismic data acquired by this technique usually contain the noise of diverse components, which increases the difficulty in subsequent data analysis and interpretation. This study has (1) trained a deep learning model that effectively suppressed noise with augmented noise data sets to obtain a high signal-to-noise ratio in the DAS vertical seismic profile (VSP) records, (2) introduced an attention module to enhance the extraction and recognition of signal features to recover effective signals under substantial noise interference, and (3) introduced adversarial loss and cycle-consistent loss to replace the commonly used L1 norm or L2 norm to train the network. The obtained hybrid training set containing unpaired synthetic and unpaired field data sets for model pretraining and fine tuning effectively improves the denoising performance of the seismic field data. In summary, this study develops an unpaired training-based DAS seismic data denoising method that transformed noisy DAS VSP data into noise-free data. By analyzing the noise suppression results of other methods, including qualitative and quantitative analyses, we demonstrate that our method successfully suppressed multiple types of noise in the DAS VSP data. The study has indicated clear and continuous signals in the denoising results and improved the denoising performance on the seismic field data.

A deep learning approach for suppressing noise in livestream earthquake data from a large seismic network

Abstract:Detecting and analyzing small earthquakes is important for many seismological studies. Signals of small earthquakes are often obscured by noise. Recent advances in signal processing and deep learning along with available computing resources provide a great opportunity to address this challenge. In this study, we present a time domain method of suppressing noise for processing livestream earthquake data from a large seismic network by applying a deep neural network Real-time Denoiser (RTDenoiser). This neural network is able to attenuate a variety of colored noise and non-earthquake signals and suppress noise in the overlapping frequency bandwidth with signals. Because of its simplicity in time domain without domain transformation and subsequent processing, the method is able to process continuous livestream three-component data from several hundreds of seismic stations simultaneously. We create 'noise-free' samples by scaling down the waveforms of relatively large events from M L 3.5–5.0 to M L 1.5–3.0 according to the Richter scaling relationship. We also select noise samples from the same seismic station and add to 'noise-free' data to generate samples at different signal-to-noise ratio (SNR) levels. These data samples are randomly split into training, validation, and test sets. We verify the trained network to process data recorded in Sichuan and Yunnan, China from 2013 to 2018. Results show that the RTDenoiser can help improve SNRs from 5 dB to 15 dB in averag. The number of detected small events at magnitude between M L 1.0 and 3.0 has been increased by 58.8 per cent. The method is currently applied in a seismic network of 300 stations in Sichuan and Yunnan, China for continuous processing. It takes about 10 ms on average to process three-component 60-s data from 300 seismic stations on a single GPU.

Abstract:Random noise attenuation of seismic data is a fundamental problem in seismic data processing. It is not only an important problem itself, but also a crucial step for the subsequent tasks, for example, migration and inversion. We propose a local orthogonalization-constrained unsupervised deep-learning denoiser (LOUD) to suppress seismic random noise based on a new loss function that specifically adapts to seismic data. Through unsupervised learning, we eliminate the common need for supervised learning approaches of collecting or generating sizable clean and noisy image pairs, which is challenging and expensive, especially for seismic data. We utilize a deep convolutional autoencoder to reconstruct the clean seismic image and leverage the local signal-and-noise orthogonalization as a constraint to guarantee that the removed noise component is orthogonal to the recovered signal. Experimental results on both synthetic and field datasets exhibit the effectiveness of our proposed method over traditional denoising methods.
