From biosensitive materials to detection techniques, various computational models and simulation software have been developed, such as molecular docking, finite-difference time-domain (FDTD), and randles models. With the help of the low-cost computational models, the sensitivity and specificity of the sensor can be pre-evaluated to improve the performance. They also provide a powerful technical means for analyzing the sensing results.

Abstract:Smart sensors are an emerging technology that allows combining the data acquisition with the elaboration directly on the Edge device, very close to the sensors. To push this concept to the extreme, technology companies are proposing a new generation of sensors allowing to move the intelligence from the edge host device, typically a microcontroller, directly to the ultra-low-power sensor itself, in order to further reduce the miniaturization, cost and energy efficiency. This paper evaluates the capabilities of a novel and promising solution from STMicroelectronics. The presence of a floating point unit and an accelerator for binary neural networks provide capabilities for in-sensor feature extraction and machine learning. We propose a comparison of full-precision and binary neural networks for activity recognition with accelerometer data generated by the sensor itself. Experimental results have demonstrated that the sensor can achieve an inference performance of 10.7 cycles/MAC, comparable to a Cortex-M4-based microcontroller, with full-precision networks, and up to 1.5 cycles/MAC with large binary models for low latency inference, with an average energy consumption of only 90 $\mu$J/inference with the core running at 5 MHz.

Abstract:Condition monitoring and control of manufacturing processes are among the key issues for the development of smart factories. The employment of multiple sensor systems for manufacturing process monitoring typically involves the detection and collection of a huge volume of heterogeneous data acquired by sensors of different nature. Smart monitoring implementation requires valuable sensorial data from multiple sensors to achieve high prediction performance in the decision making phase. Data fusion techniques can be employed to combine multiple data sources in order to generate more accurate and reliable information for decision making aimed at achieving the automatic identification of machine, tool, and part failures. This paper focuses on sensorial data quality evaluation using data fusion techniques and machine learning algorithms for intelligent multiple sensor monitoring of manufacturing processes. For this purpose, a sensorial data set derived from an experimental campaign of Inconel 718 machining was subjected to different fusion techniques in order to find the best data combination for accurate classification and recognition purposes.

Abstract:Data-driven soft sensors have been widely utilized in industrial processes to estimate the critical quality variables which are intractable to directly measure online through physical devices. Due to the low sampling rate of quality variables, most of the soft sensors are developed on small number of labeled samples and the large number of unlabeled process data is discarded. The loss of information greatly limits the improvement of quality prediction accuracy. One of the main issues of data-driven soft sensor is to furthest exploit the information contained in all available process data. This paper proposes a semisupervised deep learning model for soft sensor development based on the hierarchical extreme learning machine (HELM). First, the deep network structure of autoencoders is implemented for unsupervised feature extraction with all the process samples. Then, extreme learning machine is utilized for regression through appending the quality variable. Meanwhile, the manifold regularization method is introduced for semisupervised model training. The new method can not only deeply extract the information that the data contains, but learn more from the extra unlabeled samples as well. The proposed semisupervised HELM method is applied in a high-low transformer to estimate the carbon monoxide content, which shows a significant improvement of the prediction accuracy, compared to traditional methods.

Abstract:There are more than a trillion sensors in the world today and according to some estimates there will be about 50 trillion cameras worldwide within the next 5 years, all collecting data either sporadically or around the clock. With such explosive growth of available data and computing resources, recent advances in machine learning and data analytics have yielded transformative results across diverse scientific disciplines, including image recognition, natural language processing, cognitive science, and genomics. However, in many engineering applications, quality and error-free data is not easy to obtain, e.g., for system dynamics characterized by bifurcations and instabilities, hysteresis, delayed responses, and often irreversible responses. Admittedly, as in all everyday applications, in engineering problems, the volume of data has increased substantially compared to even a decade ago but analyzing big data is expensive and time-consuming. Data-driven methods, which have been enabled in the past decade by the availability of sensors, data storage, and computational resources, are taking center stage across many disciplines (physical and information) of science. We now have highly scalable solutions for problems in object detection and recognition, machine translation, text-to-speech conversion, recommender systems, and information retrieval. All of these solutions attain state-of-the-art performance when trained with large amounts of data. However, purely data-driven approaches for machine learning present difficulties when the data is scarce and of variable fidelity relative to the complexity of the system. The vast majority of state-of-the art machine learning techniques (e.g., deep neural nets, convnets, RNNs, etc.) are lacking robustness and fail to provide any guarantees of convergence or quantify the error/uncertainty associated with their predictions. Hence, the ability to learn in a sample-efficient manner is a necessity in these data-limited domains. Less well understood is how to leverage the underlying physical laws and/or governing equations to extract patterns from small data generated from highly complex systems.

Abstract:Nowadays, the Internet of Things is a technology used in a wide range of applications, empowering fields such as the smart city, smart transportation, and the manufacturing industry. Their growing number increases the demand for robust and intelligent solutions providing relevant data, while relying on as few resources as possible. To this end, it is essential to search for techniques and solutions that can achieve a high level of quality of service, using the least hardware and cost. Machine learning can tackle the challenge by generating virtual data. It aims on replicating a sensor's activity by utilizing real data from a subset of sensors. Such a task could be difficult with existing means, while the proposed approach might reduce it to a trivial calculation. In a similar fashion, it is possible to use simulation models for data analysis and model validation, by feeding the existing simulation models with varying conditions and comparing the results with the real ones. The current work aims to utilize the virtual IoT paradigm, in order to immerse and test everyday applications in realistic conditions and constraints. Finally, a prototype's implementation in real-life use cases is discussed, such as the illumination in an industrial environment.

Machine Learning and Big Data Processing for Cybersecurity Data Analysis

Abstract:The chapter presents an approach to cybersecurity data analysis based on the combination of a set of machine learning methods and Big Data technologies for network attack and anomaly detection. The approach is characterized by several layers of data processing, including extraction and decomposition of datasets, compression of feature vectors, training, and classification. To reduce the dimension of the analyzed feature vectors, principal component analysis is applied. Various binary classifiers are used for analyzing the input vector using principal component analysis: support vector machine, k-nearest neighbors, Gaussian naïve Bayes, artificial neural network, and decision tree. In order to increase the precision of attack detection, it is proposed to combine these classifiers into a single weighted ensemble. This is constructed on the basis of weighted voting, soft voting, AdaBoost, and majority voting. Two different architectures of the distributed intrusion detection system based on Big Data technologies are used. In the first, parallel data processing is achieved by splitting data into several non-intersecting subsets, and a separate parallel thread is assigned to each of the formed chunks. In the second, several client-sensors and a server-collector are used, where each sensor contains several network analyzers and a balancer. The efficiency of the suggested approach for network attack and anomaly detection is experimentally evaluated using two different datasets: a dataset with Internet of Things traffic including several kinds of different classes of attacks; and a dataset with computer network traffic containing host scanning and DDoS attacks.

Abstract:Real-time systems are widely used in industry, including technological process control systems, industrial automation systems, SCADA systems, testing, and measuring equipment, and robotics. The efficiency of executing an intelligent robot's mission in many cases depends on the properties of the robot's sensor and control systems in providing the trajectory planning, recognition of the manipulated objects, adaptation of the desired clamping force of the gripper, obstacle avoidance, and so on. This paper provides an analysis of the approaches and methods for real-time sensor and control information processing with the application of machine learning, as well as successful cases of machine learning application in the synthesis of a robot's sensor and control systems. Among the robotic systems under investigation are (a) adaptive robots with slip displacement sensors and fuzzy logic implementation for sensor data processing, (b) magnetically controlled mobile robots for moving on inclined and ceiling surfaces with neuro-fuzzy observers and neuro controllers, and (c) robots that are functioning in unknown environments with the prediction of the control system state using statistical learning theory. All obtained results concern the main elements of the two-component robotic system with the mobile robot and adaptive manipulation robot on a fixed base for executing complex missions in non-stationary or uncertain conditions. The design and software implementation stage involves the creation of a structural diagram and description of the selected technologies, training a neural network for recognition and classification of geometric objects, and software implementation of control system components. The Swift programming language is used for the control system design and the CreateML framework is used for creating a neural network. Among the main results are: (a) expanding the capabilities of the intelligent control system by increasing the number of classes for recognition from three (cube, cylinder, and sphere) to five (cube, cylinder, sphere, pyramid, and cone); (b) increasing the validation accuracy (to 100%) for recognition of five different classes using CreateML (YOLOv2 architecture); (c) increasing the training accuracy (to 98.02%) and testing accuracy (to 98.0%) for recognition of five different classes using Torch library (ResNet34 architecture) in less time and number of epochs compared with Create ML (YOLOv2 architecture); (d) increasing the training accuracy (to 99.75%) and testing accuracy (to 99.2%) for recognition of five different classes using Torch library (ResNet34 architecture) and fine-tuning technology; and (e) analyzing the effect of dataset size impact on recognition accuracy with ResNet34 architecture and fine-tuning technology. The results can help to choose efficient (a) design approaches for control robotic devices, (b) machine-learning methods for performing pattern recognition and classification, and (c) computer technologies for designing control systems and simulating robotic devices.

Abstract:Tactile sensors have developed rapidly, which increases the need for data processing. While machine learning, rather than conventional approaches, provides new support for tactile data analysis, thanks to its strong capacity for processing massive data quickly, the machine learning methods for tactile data processing and their applications are reviewed. The current issues and future directions are then discussed. The past decades have seen the rapid development of tactile sensors in material, fabrication, and mechanical structure design. The advancement of tactile sensors has heightened the expectation of sensor functions, and thus put forward a higher demand for data processing. However, conventional analysis techniques have not kept pace with the tactile sensor development and still suffer from some severe drawbacks, like cumbersome models, poor efficiency, and expensive costs. Machine learning, with its prominent ability for big data analysis and fast processing speed, can offer many possibilities for tactile data analysis. Herein, the machine learning techniques employed for processing tactile signals are reviewed. Supervised learning and unsupervised learning for analog signals are covered, and processing spike signals with machine learning are summarized. Furthermore, the applications in robotic tactile perception and human activity monitoring are presented. Finally, the current challenges and future prospects in sensors, data, algorithms, and benchmarks are discussed.

Abstract:In view of Industry 4.0, data generation and analysis are challenges. For example, machine health monitoring and remaining useful life prediction use sensor signals, which are difficult to analyze using traditional methods and mathematical techniques. Machine and deep learning algorithms have been used extensively in Industry 4.0 to process sensor signals and improve the accuracy of predictions. Therefore, this paper proposes and validates the data-driven prediction model to analyze sensor data, including in the data transformation phase Principal Component Analysis tested by Fourier Transformation and Wavelet Transformation, and the modeling phase based on machine and deep learning algorithms. The machine learning algorithms used for tests in this research are Random Forest Regression (RFR), Multiple Linear Regression (MLR), and Decision Tree Regression (DTR). For the deep learning comparison, the algorithms are Deep Learning Regression and Convolutional network with LeNet-5 Architecture. The experimental results indicate that the models show promising results in predicting wear values and open the problem to further research, reaching peak values of 92.3% accuracy for the first dataset and 62.4% accuracy for the second dataset.

Abstract:Abstract: Air pollution is a worldwide problem having impacts on both local and global scales. According to the World Health Organization (WHO), air pollution causes 7 million deaths every year, with 4.2 million attributed to exposure to outdoor air pollution. Compared to the reference methods defined in the Air Quality Directive, the use of low-cost air quality sensors for monitoring ambient air pollution would reduce air pollution monitoring costs and would also allow larger spatial coverage especially in remote areas where monitoring with traditional facilities is uneasy. Theses multi-sensors were either calibrated against standard gas mixtures or using artificial neural network under field conditions. The later method resulted in mixed results either satisfactory for short periods or generally weak for longer data series. This project mainly focuses on the adaptive calibration of the low-cost sensors using the trained machine learning model. The performances of several field calibration methods for low-cost sensors, including linear/multi linear regression and supervised learning techniques will be compared. A cluster of ozone, nitrogen dioxide, nitrogen monoxide, carbon monoxide and carbon dioxide sensors will be operated. Subsequently, the accuracy of the predicted values will be evaluated for about a period. These predicted values are fed through the training model and the model will run accordingly and it will adapt all the error situations. This will be useful to the automobile industry in the current situation for smoke emission control and also for many refinery industries in which low-cost sensors can be used with the following modelling for the higher accuracy. Abstract:(Micro)spectroscopy often generates various output signals due to intrinsic inhomogeneity of material arrangement at low dimensions or machinery drift, albeit the bulk composition and experimental parameters remain constant. In fact, such diversity can be harnessed to measure material’s purity, unveiling various concealed features via statistical inspection of heterogeneous signals acquired from several microscopy scans. However, the approach requires efficient categorization of a substantial number of signals, which is currently encumbered by laborious calculations, computational hurdles, and manual intervention. This necessitates a programmed interface to perform time-efficient big data analytics, lack of which has perpetually widened the schism between laboratory and industrial-scale microscopy-based assessment of nanomaterials. We present a robust technique - an unsupervised machine learning driven module for automatic clustering and class-wise power spectral density calculation of real-time microscopy signals. Our methodology has been tested across different aspects of wide-field fluorescence imaging and scanning tunnelling spectroscopy, demonstrating the versatility. Additionally, we investigated the impact of data-processing on the clustering efficiency and optimized the methodology. We anticipate that our futuristic workflow package for contemporary microscopes is the initial endeavor toward fast data analytics and instant material characterization, spanning a diverse spectrum of interests.

Abstract:In recent years, the application of machine learning for virtual sensing has revolutionized the monitoring and management of information. In particular, electrochemical sensors generate large amounts of data, allowing the application of complex machine learning/AI models able to (1) reproduce the measured data and (2) predict and manage faults in the measuring sensor. In this work, data-driven models based on an autoregressive model and an artificial neural network have been identified and used to (i) evaluate sensor redundancy and (ii) predict and manage faults in the context of electrochemical sensors for the measurement of ethanol. The approach shows encouraging results in terms of both performance and sensitivity analyses, allowing for the reconstruction of the values measured by two sensors in a series of six sensors with different dopant levels and to reproduce their values after a fault.

Abstract:Machine learning encompasses a broad range of algorithms and modeling tools used for a vast array of data processing tasks, which has entered most scientific disciplines in recent years. We review in a selective way the recent research on the interface between machine learning and physical sciences. This includes conceptual developments in machine learning (ML) motivated by physical insights, applications of machine learning techniques to several domains in physics, and cross-fertilization between the two fields. After giving basic notion of machine learning methods and principles, we describe examples of how statistical physics is used to understand methods in ML. We then move to describe applications of ML methods in particle physics and cosmology, quantum many body physics, quantum computing, and chemical and material physics. We also highlight research and development into novel computing architectures aimed at accelerating ML. In each of the sections we describe recent successes as well as domain-specific methodology and challenges.

Abstract:Rapid developments in hardware, software, and communication technologies have allowed the emergence of Internet-connected sensory devices that provide observation and data measurement from the physical world. By 2020, it is estimated that the total number of Internet-connected devices being used will be between 25 and 50 billion. As the numbers grow and technologies become more mature, the volume of data published will increase. Internet-connected devices technology, referred to as Internet of Things (IoT), continues to extend the current Internet by providing connectivity and interaction between the physical and cyber worlds. In addition to increased volume, the IoT generates Big Data characterized by velocity in terms of time and location dependency, with a variety of multiple modalities and varying data quality. Intelligent processing and analysis of this Big Data is the key to developing smart IoT applications. This article assesses the different machine learning methods that deal with the challenges in IoT data by considering smart cities as the main use case. The key contribution of this study is presentation of a taxonomy of machine learning algorithms explaining how different techniques are applied to the data in order to extract higher level information. The potential and challenges of machine learning for IoT data analytics will also be discussed. A use case of applying Support Vector Machine (SVM) on Aarhus Smart City traffic data is presented for a more detailed exploration.

Abstract:The gap between machine learning-assisted digital processing and modern scientific analysis has been closed by advances in computer vision technologies. In the realm of biomechanics, tactics that combine traditional and machine-assisted methods have demonstrated remarkable effectiveness in enhancing the electromyographical sensor observations; nevertheless, these methods are limited by specialized, multi-source arrays. This work is an effort to apply multiple different technologies to a single optical sensor in order to obtain comparable outcomes. The goal of this work is to provide an overview of the research, development, and use of a monocular feature extraction pipeline that can be used to enhance current sports biomechanics analysis. We will look at the methods that related publications have provided and how we have incorporated these approaches into our framework.

Abstract:In this article, we present the statistical analysis of data from inexpensive sensors. We also present the performance of machine learning algorithms when used for automatic calibration of such sensors. In this, we have used low-cost nondispersive infrared CO2 sensor placed at a co-located site at Cape Point, South Africa (maintained by Weather South Africa). The collected low-cost sensor data and site truth data are investigated and compared. We compare and investigate the performance of random forest regression, support vector regression, 1-D convolutional neural network (CNN), and 1D-CNN long short-term memory network models as a method for automatic calibration and the statistical properties of these model predictions. In addition, we also investigate the drift in performance of these algorithms with time.

Abstract:Sensors, satellites, mobile devices, social media, e-commerce, and the Internet, among others, saturate us with data. The Internet of Things, in particular, enables massive amounts of data to be generated more quickly. The Internet of Things is a term that describes the process of connecting computers, smart devices, and other data-generating equipment to a network and transmitting data. As a result, data is produced and updated on a regular basis to reflect changes in all areas and activities. As a consequence of this exponential growth of data, a new term and idea known as big data have been coined. Big data is required to illuminate the relationships between things, forecast future trends, and provide more information to decision-makers. The major problem at present, however, is how to effectively collect and evaluate massive amounts of diverse and complicated data. In some sectors or applications, machine learning models are the most frequently utilized methods for interpreting and analyzing data and obtaining important information. On their own, traditional machine learning methods are unable to successfully handle large data problems. This article gives an introduction to Spark architecture as a platform that machine learning methods may utilize to address issues regarding the design and execution of large data systems. This article focuses on three machine learning types, including regression, classification, and clustering, and how they can be applied on top of the Spark platform.
