Abstract:Near infrared spectroscopy is a new on-line analysis technology,which is fit for the detection of organic substance,such as volatile matter of coal.In this paper,139 coal samples were chosen to acquire diffuse reflectance near-infrared spectra.Then the spectra were correlated to volatile matter of coal with partial least squares.At the same time,different spectral band selecting and pre-treatment methods were used to optimize regression model.At last,the regression model was built for fat coal,and the model result was significantly improved.It shows that regression model of homogeneous set can improve the prediction ability.

Abstract:Epoxy micro-nanocomposite specimens incorporated with 66 wt% of silica micro fillers and 0.7 wt% of ion trapping particles as nano fillers, are coated with four different variants of coal. The conductivity of the coal deposited samples is observed to be in direct correlation with the percentage carbon content present in the coal samples. The epoxy micro-nanocomposite specimens coated with different variants of coals were successfully classified by using Laser induced breakdown spectroscopy (LIBS) assisted by various machine learning techniques. It is noticed that the classification through Logistic regression method (LRM) has reflected a higher training as well as testing accuracy of 100% and 98%, respectively when compared to other machine learning methods.

Abstract:Aimed at the quantitative analysis of pulverized coal ignition temperature, this paper presents a piecewise least squares support vector machine modeling method, where several sub-models are created according to the burning characteristics of lignite, bituminous coal, lean coal and anthracite coal etc. and the parameters of each sub-model are optimized independently. By implementing the piecewise LSSVM and the global LSSVM on coal fuel samples obtained from certain company, we find that the piecewise LSSVM behaves better than the global LSSVM on mean-square error and correlation coefficient, etc.

Abstract:Laser-induced breakdown spectroscopy(LIBS)is an emerging atomic spectroscopy technique that has the advantages of low sample pre-treatment and rapid,in situ,and simultaneous multi-element measurements.LIBS demonstrates good prospects in the field of coal analysis.In recent years,chemometric and machine learning models have been widely used to improve the quantitative accuracy of LIBS in coal analysis.Generally,these models rely on a certain number of training samples to ensure the reliability of the prediction results.However,obtaining the certified content(label information)of coal samples used for model training requires traditional chemical analysis,which is complex and time-consuming.This may lead to insufficient training samples and poor model performance.To tackle the small sample problem in LIBS-based coal analysis,this work proposes a semi-supervised learning method based on the ensemble of multiple models.5 baseline models are first established based on the initial training set,including multiple linear regression(MLR),partial least squares regression(PLSR),locally weighted partial least squares regression(LW-PLSR),support vector regression(SVR),and kernel extreme learning machine(K-ELM).The unlabelled data are processed using the 5 models,and 5 prediction values are obtained.For each unlabelled sample,the standard deviation of the 5 prediction values is calculated,and the unlabelled sample corresponding to the smallest standard deviation is added to the training set.Its pseudo label is the average of the 5 prediction values.As the training set is iteratively expanded,its corresponding training model is updated.The final training model is optimized and used to analyse the test samples.The proposed method is tested on a coal dataset containing 20 training samples,39 test samples and 280 unlabelled samples.The results show that the proposed method improves the coefficient of determination(R2)for content prediction of fixed carbon,ash,and volatile by 0.033,0.102 and 0.118,respectively.Therefore,if the number of training samples is insufficient,semi-supervised learning can effectively improve the accuracy and reliability of LIBS quantification.

Abstract:Fast or online coal property analysis would greatly improve coal pricing reliability and combustion optimization for power generation, especially in China. A non-linearized multivariate dominant factor based partial least square (PLS) model was applied to analyze coal properties through laser-induced breakdown spectroscopy (LIBS). The dominant factor explicitly modeled the direct correlation between coal property and spectral line intensities, whereas residual errors were corrected by PLS method with full spectral information. The results demonstrated an overall improvement over conventional PLS method for ash content, volatile content, and calorific value measurement. For example, the root mean square error of prediction of calorific value was decreased from 1.63 MJ kg(-1) to 1.33 MJ kg(-1); and the average relative error of all samples was reduced from 3.55% to 2.71%. Although current LIBS application results for coal proximate analysis have not met the national standard, LIBS is shown to be fully capable of providing useful information for coal combustion optimization and reliable references for coal pricing, showing LIBS has great potential for coal property analysis for the power generation industry.

Abstract:The combination of laser-induced breakdown spectroscopy and energy dispersive X-ray fluorescence spectroscopy in the coal quality analysis was reported formerly. But in the practical test of the prototype instrument in the real power plant, the X-ray fluorescence signals suffered from intensity fluctuations over long-time measurements. The long-term signal fluctuations cause lower efficiency on the establishment of the calibration model and relatively larger root-mean-squared error of prediction (RMSEP) for unknown samples. Therefore, the spectral intensity correction was performed in the measurements; a randomly selected sample was measured several times in the whole measurements, including the modeling samples and unknown samples, recording the signal fluctuations and searching for a set of factors suitable for the intensity correction of a full-spectrum–based partial least square calibration model. In addition, as the signals of the coal samples of the power plant showed the potential of classification, the piecewise models were also established in case of further enhancement of the model or prediction accuracy. The RMSEPs of the calorific value, ash, volatile, and sulfur were lowered from 0.68 MJ/kg, 1.62%, 0.32%, and 0.24% to 0.51 MJ/kg, 1.34%, 0.16%, and 0.14% after spectral intensity correction, respectively. The piecewise modeling with spectral intensity correction achieved similar RMSEP for volatile and sulfur prediction but with more accurate models. The spectral intensity correction showed the ability to reduce the long-term signal fluctuation, and piecewise modeling also showed more efficiency in the model establishments for volatile and ash determination.

Abstract:Determination of coal quality plays a major role in coal-fired power plants and coal producers for optimizing the utilization efficiency and controlling the quality. In this work, a rapid coal analyzer based on laser-induced breakdown spectroscopy (LIBS) was developed for rapid quality analysis of pulverized coal. The structure of the LIBS apparatus was introduced in detail. To avoid time-consuming and complicated sample preparation, a pulverized feeding machine was designed to form a continuously stable coal particle flow. The standard deviation (SD) of characteristic peaks was used to estimate the spectral valid data in this experiment. Coupled with cluster analysis, artificial neural networks and genetic algorithm are employed as a nonlinear regression method in order to indicate the relationship between coal quality and the corresponding plasma spectra. It is shown that the average absolute error of ash, volatile matter, fixed carbon, and gross calorific value for the validation set is 0.82%, 0.85%, 0.96%, and 0.48 MJ/kg. The average standard deviation of repeated samples is 1.64%, 0.92%, 1.08%, and 0.86 MJ/kg, showing a high sample-to-sample repeatability. This rapid coal analyzer is capable of performing reliable and accurate analysis of coal quality.

Abstract:Abstract Although laser-induced breakdown spectroscopy (LIBS), as a fast on-line analysis technology, has great potential and competitiveness in the analysis of chemical composition and proximate analysis results of coal in thermal power plants, the measurement repeatability of LIBS needs to be further improved due to the difficulty in controlling the stability of the generated plasmas at present. In this paper, we propose a novel x-ray fluorescence (XRF) assisted LIBS method for high repeatability analysis of coal quality, which not only inherits the ability of LIBS to directly analyze organic elements such as C and H in coal, but also uses XRF to make up for the lack of stability of LIBS in determining other inorganic ash-forming elements. With the combination of elemental lines in LIBS and XRF spectra, the principal component analysis and the partial least squares are used to establish the prediction model and perform multi-elemental and proximate analysis of coal. Quantitative analysis results show that the relative standard deviation (RSD) of C is 0.15%, the RSDs of other elements are less than 4%, and the standard deviations of calorific value, ash content, sulfur content and volatile matter are 0.11 MJ kg −1 , 0.17%, 0.79% and 0.41% respectively, indicating that the method has good repeatability in determination of coal quality. This work is helpful to accelerate the development of LIBS in the field of rapid measurement of coal entering the power plant and on-line monitoring of coal entering the furnace.

Abstract:Laser-induced breakdown spectroscopy (LIBS) has been applied in coal analysis for advantages such as real-time online analysis. Fine-tuning is a transfer learning method that has been utilized in LIBS to improve accuracy in the target domain with a limited training set by introducing a model trained on a different but related source domain. This research proposed a hybrid transfer learning method (HTr-LIBS) to further enhance the performance of LIBS coal analysis by combining fine-tuning with sample reweighting. A neural network was pre-trained on the source domain and target domain training set. The sample weights of the source domain were iteratively adjusted according to the prediction errors. The pre-trained neural network with optimal sample weights was then fine-tuned using the target domain training set. The proposed method significantly improved the analytical accuracy compared to direct modeling using small training sets. When the training set size increased to 19, the R 2 P of direct modeling for ash content and volatile matter content were 0.8105 and 0.9440, respectively. HTr-LIBS increased the R 2 P for ash content and volatile matter content to 0.9029 and 0.9627, respectively. The improvements were more significant and stable than fine-tuning of the source domain model without sample reweighting. The introduction of target domain data during pre-training and the iterative adjustment of sample weights both contributed to the improvements.

Abstract:Ash content, as a crucial indicator of coal quality, its rapid and accurate determination is pivotal to improve the energy utilization of coal and reduce environmental pollution. Traditional spectroscopic methods face significant challenges in acquiring accurate information from coal samples due to the notorious matrix effects arising from their complex composition, vast molecular structure, and diverse coal types. In this study, the feasibility of total reflection X-ray fluorescence (TXRF) combined with partial least squares (PLS) for the determination of coal ash was firstly investigated based on the TXRF being unaffected by matrix effects. Firstly, coal samples were prepared as suspensions, and the effects of sample particle size and different dispersants on the results of TXRF analyses were evaluated. The accuracy and applicability of the chosen sample preparation strategies were further validated using inductively coupled plasma mass spectrometry (ICP-MS) and two certified reference materials (CRMs). Subsequently, based on the analysis of 19 coal samples, the impact of three different predictive variables on the performance of the PLS model was investigated: (a) TXRF full spectrum normalized by the net intensity of the internal standard; (b) net intensity of characteristic peaks for 12 elements (Al, Si, K, Ca, Ti, Fe, Cr, Mn, Cu, Ni, and Sr) normalized by the net intensity of the internal standard; (c) concentrations of the aforementioned 12 elements. The results demonstrate that the PLS model constructed usingthe TXRF full spectrum normalized by the net intensity of the internal standard exhibits the best predictive capabilities, with the determination coefficient of calibration set (R 2 ) and mean square error (MSE) of the prediction set reaching 0.9736 and 0.99 %, respectively. Moreover, the measurement accuracy of this model was six times greater than that obtained with traditional X-ray fluorescence (XRF). Presented analytical results display the possibilities of combining TXRF with PLS for coal quality evaluation.

Abstract:Rapid and accurate analysis of the coal properties is essential for its clean and efficient utilization. However, the complexity of the physical-chemical characteristics of coal complicates accurate quantification of its properties using rapid spectroscopic technologies. Herein, a synergistic method is proposed to achieve optimum results for coal proximate analysis using spectra obtained via laser-induced breakdown spectroscopy (LIBS) and near-infrared reflectance spectroscopy (NIRS). Firstly, the ash content was analyzed by LIBS, and the moisture content was analyzed by NIRS. The calorific value and volatile content were then analyzed using the fusion data obtained from LIBS and NIRS, combined with the ash and moisture results. Finally, the fixed carbon content was calculated by subtracting the mass percentage fractions of ash, moisture, and volatile matter from 100%. The results indicated that the proposed method achieved good quantitative performance for coal proximate analysis. The root mean square errors of prediction for ash, moisture, calorific value, volatile matter, and fixed carbon were 0.743%, 0.304%, 0.187 MJ/kg, 0.662% and 0.972%, respectively. Thus, we believe that the proposed method based on the synergy of LIBS and NIRS opens avenues for efficient prospective analysis of coal properties.
A hybrid quantification model and its application for coal analysis using laser induced breakdown spectroscopy

Abstract:The low sample-to-sample reproducibility of laser induced breakdown spectroscopy (LIBS) is the most critical obstacle to wide commercialization of the technology. Averaging multi-pulse normalized spectra is the only applied method to improve the sample-to-sample reproducibility; however, the method can only improve the reproducibility to some extent because the averaging process can only eliminate random noise and has no effect on non-random noise, and because normalization can only partially and indirectly remove the signal fluctuations. In addition, the measurement accuracy of LIBS is also limited due to matrix effects as well as signal uncertainty. In this work, we propose a set method to improve both precision (sample-to-sample reproducibility) and accuracy for LIBS quantification. The method includes three steps: (1) the intensities of all spectral lines from every single pulse are converted to a standard state value using a "spectrum standardization" method to reduce the measurement uncertainties to acceptable levels; (2) the standardized spectra are compared with a large spectral database to check whether the current sample is a new sample or is already in the database with known composition/property information; and (3) if the sample is found to be a new sample, a dominant factor based partial least square (PLS) model is applied to provide quantitative analytical results, and the new standardized spectral information and analytical results are inserted into the spectrum database, making the database self-adaptable for future measurements; while if the sample is found to be already in the database, the analytical results are directly obtained from the database. The proposed method was applied for coal analysis. The results showed that the relative standard deviation (RSD) of carbon for different measurements of the same sample is 0.3%, proving that LIBS is able to provide high reproducibility, at least for coal analysis applications. The average measurement errors for carbon, hydrogen, volatiles, ash and heat values are 0.42%, 0.05%, 0.07%, 0.17% and 0.07 MJ kg(-1), respectively, and all of these measurement accuracies fully meet the requirements of the national standard for coal analyses using traditional chemical processing methods. This is the first quantitative application of LIBS with real industrial requirements, and the present work proves the feasibility of LIBS for accurate quantification from a technical point of view.

Abstract:Coal analysis is of great importance to improve coal combustion/utilization efficiency and operation safety and to reduce pollution. In this work, we develop a LIBS system for at-line coal analysis, which can pre-treat coal blocks into pressed pellets, acquire sample spectra and quantify coal properties automatically and continuously. A series of techniques are integrated in the system, including laser energy monitor and control, plasma modulation and collinear spectra collection. Moreover, the system has an integrated circuit board that is designed to precisely control the time-sequence of the hardware components; the overall design of the system ensures environmental factors are stabilised. These design considerations improve raw signal repeatability and signal-tonoise ratio. Furthermore, to improve the quantification accuracy without the use of LIBS physics knowledge, a new machine learning method is proposed, namely synergic regression (SR), which embeds a linear model in nonlinear regression. It inherits the high accuracy of nonlinear methods whilst being able to explain how specific variables contribute to the prediction. The system was demonstrated and evaluated in a real power plant for 10 weeks. The average prediction errors of calorific value (MJ/kg), sulphur (%) and volatile (%) were 0.299, 0.077 and 0.590, respectively. The evaluation demonstrated that the developed LIBS system meets the industry standards for at-line and in-situ coal analysis. Therefore, the LIBS system has significant potential impact on practices in coal utilization and similar industrial processes.
Quantitative Carbon Analysis in Coal by Combining Data Processing and Spatial Confinement in Laser-Induced Breakdown Spectroscopy

Abstract:Online measurement of carbon content of coal is important for coal-fired power plants to realize the combustion optimization of coal-fired boilers. Given that the measurement of carbon content of coal using laser-induced breakdown spectroscopy (LIBS) suffers from low measurement accuracy because of matrix effects, our previous study has proposed a combination model to improve the measurement accuracy of carbon content of coal. The spatial confinement method, which utilizes the spectral emissions of laser-induced plasmas spatially confined by cavities for quantitative analysis, has potential to improve quantitative analysis performance. In the present study, the combination model was used for coal measurement with cylindrical cavity confinement to further improve the measurement accuracy of carbon content of coal. Results showed that measurement accuracy was improved when the combination model was used with spatial confinement method. The coefficient of determination, root-mean-square error of prediction, average relative error, and average absolute error for the combination model with cylindrical cavity confinement were 0.99, 1.35%, 1.66%, and 1.08%, respectively, whereas values for the combination model without cylindrical cavity confinement were 0.99, 1.63%, 1.82%, and 1.27%, respectively. This is the first time that the average absolute error of carbon measurement for coal analysis has achieved close to 1.0% using LIBS, which is the critical requirement set for traditional chemical processing method by Chinese national standard. These results indicated that LIBS had significant application potential for coal analysis.

Abstract:The heat value of coal is one of the most important coal properties that affects the operation of coal-fired boilers. The on-line analysis of heat value of coal can provide important reference for optimizing and adjusting the boiler operation in real time. The heat values of bituminous coal samples were quantitatively analyzed by laser-induced breakdown spectroscopy (LIBS). The 1064 nm laser radiation emitted by a Q-switched Nd: YAG laser was utilized for laser ablation and plasma generation in air. The partial least square (PLS) method and the dominant factor based PLS method were used to improve the measurement accuracy of heat value of coal. In the dominant factor based PLS model, the molecular emissions of C2 and CN were utilized to build the dominant factor model. The coefficient of determination and the root-mean-square error of prediction of the PLS model were 0.94 and 1.46 MJ/kg, respectively; and those values for the dominant factor based PLS model were 0.99 and 1.18 MJ/kg, respectively. The results show that LIBS has great potential for the on-line analysis of heat value of coal.

Abstract:The dust from pulverized coal weakens the acquired signal and increases the analysis difficulty for the quantitative analysis of the carbon content of pulverized coal when using laser-induced breakdown spectroscopy (LIBS). Moreover, there is a serious matrix effect and a self-absorption phenomenon. To improve the analysis accuracy, the DSC-PLS (double spectral correction-partial-least-squares) method was proposed to predict the carbon content of pulverized coal. Initially, the LIBS signal was corrected twice using P-operation-assisted adaptive iterative-weighted penalized-least-squares (P-airPLS), plasma temperature compensation, and spectral normalization algorithms. The goodness of fit of the carbon element was improved from nonlinearity to above 0.948. The modified signal was then used to establish DCS-PLS models for predicting unknown samples. In comparison to the conventional PLS model, the DSC-PLS method proposed in this paper significantly improves the ability to predict carbon content. The prediction error of the developed method was dropped from an average of 4.66% to about 0.41%, with the goodness of fit R2 of around 0.991.

Abstract:Serious slagging and ash deposition issues occur in combustion of Zhundong coal in industrial power plants due to its high content of alkali (Na, K). In this study, Zhundong coal was treated by chemical methods to make a lot of coal samples with a large range of Na and K concentrations. The results of Inductively Coupled Plasma Spectroscopy (ICP) were used as known variables for the calibration and prediction of Na and K content using laser-induced breakdown spectrum (LIBS).The results showed the measurements of Na and K by LIBS had high sensitivity, low detection limit and low Root Mean Square Prediction Error (RMSEP). The lower element concentration the sample contained, the greater the RSD was. When the element concentration reached a certain value, the RSD of measurement became stable. A large number of repeated measurements can guarantee the accuracy of LIBS measurement. Because LIBS technology itself has the advantage of fast measurement，LIBS could be a valid method to achieve online measurement of alkali content in coal.

Abstract:A partial least squares (PLS) and wavelet transform hybrid model are proposed to analyze the carbon content of coal by using laser-induced breakdown spectroscopy (LIBS). The hybrid model is composed of two steps of wavelet analysis procedures, which include environmental denoising and background noise reduction, to pretreat the LIBS spectrum. The processed wavelet coefficients, which contain the discrete line information of the spectra, were taken as inputs for the PLS model for calibration and prediction of carbon element. A higher signal-to-noise ratio of carbon line was obtained after environmental denoising, and the best decomposition level was determined after background noise reduction. The hybrid model resulted in a significant improvement over the conventional PLS method under different ambient environments, which include air, argon, and helium. The average relative error of carbon decreased from 2.74 to 1.67% under an ambient helium environment, which indicated a significantly improved accuracy in the measurement of carbon in coal. The best results obtained under an ambient helium environment could be partly attributed to the smallest interference by noise after wavelet denoising. A similar improvement was observed in ambient air and argon environments, thereby proving the applicability of the hybrid model under different experimental conditions.
