Application of Response Surface Methodology and Machine Learning Approaches to Predict Porosity and Compression Strength of Selective Laser-Sintered Polyamide-12 Scaffold Parts

Abstract:Recent improvements in Selective Laser Sintering (SLS) technology have prompted researchers to examine the fabrication method as a solution for patient-specific orthopedic issues. Although SLS remains a desirable method for sintering polymer materials, poor selection of process parameter ranges can reduce the porosity of manufactured components and decrease the mechanical performance. This study aims to identify the optimal combination of process parameters to enhance the porosity of the manufactured parts without compromising scaffold strength. Using the SLS technology and response surface methodology-based Box–Behnken design, 17 polymer-based scaffolds were manufactured. Further, the fabricated samples are subjected to compression and porosity tests to determine the effect of pore size, laser power, and scanning speed. To establish an optimum parameter combination, desirability function approach was used. The pore size of 0.6 mm, laser power of 3 W, and scanning speed of 1545 mm/s are found as the optimal parameter combination. Compression strength of 69 MPa and porosity of 35.6% were achieved at the optimal set. The compressive strengths of scaffolds manufactured using the optimal process set are close to the upper limit of the compressive strength of a human fibula bone (67 MPa). Scanning Electron Microscopy (SEM) images were subsequently used to validate the scaffold's porosity at the optimal process factor set. In the development of this work, the study also evaluated the ability of Machine Learning (ML) techniques, namely Gaussian Process Regression (GPR) and Support Vector Machine (SVM), to predict the output responses of scaffold parts. With a coefficient of determination of 0.96, the SVM method exceeds the GBR in terms of its predictive capabilities.
