Abstract:In recent years, the Semiconductor Final Testing Scheduling Problem (SFTSP), recognized as a unique multi-resource scheduling challenge, attracts increasingly attention of academia and industry in the semiconductor manufacturing process. In this paper, a novel estimation of distribution algorithm combined with Q-learning (QEDA) is proposed to solve the SFTSP. According to the characteristics of the used operation encoding, a new probability matrix update mechanism is proposed for enhancing the priority relationships among operations. Considering that the traditional EDA is not in favor of local exploitation compared with its global exploration, a reinforcement learning is designed to improve the performance of the proposed algorithm. Furthermore, for the challenge of the resource allocation in SFTSP, four actions are introduced based on the variance of individual objectives. Extensive numerical simulations and comparative experiments show that the proposed QEDA algorithm exhibits much better performance than the state-of-the-art algorithms in the literature for solving the SFTSP.

Abstract:Semiconductor final testing scheduling problem (SFTSP) has extensively been studied in advanced manufacturing and intelligent scheduling fields. This paper presents a Q-learning based hyper-heuristic (QHH) algorithm to address the SFTSP with makespan criterion. The structure of QHH employs the Q-learning algorithm as the high-level strategy to autonomously select a heuristic from a pre-designed low-level heuristic set. The selected heuristic in different stages of the optimization process is recognized as the executable action and performed on the solution space for better results. An efficient encoding and decoding pair is presented to generate feasible schedules, and a left-shift scheme is embedded into the decoding process for improving resources utilization. Additionally, the design-of-experiment method is implemented to investigate the effect of parameters setting. Both computational simulation and comparison are finally carried out on a benchmark set and the results demonstrate the effectiveness and efficiency of the proposed QHH.

Abstract:The final testing process ensures the quality of the products in the semiconductor manufacturing factory. Scheduling for the final testing process is crucial to the economic efficiency of production. In this paper, an effective knowledge-based multi-agent evolutionary algorithm (KMEA) is proposed for solving the semiconductor final testing scheduling problem (SFTSP). In the KMEA, each agent is represented by a solution, which is a combination of the operation sequence vector and the machine assignment vector. A hybrid initialization mechanism is proposed to balance the diversity and the quality of the initial agents. In each iteration of evolution, the agents evolve by mutual-learning and competition based on the model of agent lattice. Moreover, a knowledge base is employed to store the useful information during the search process. The knowledge base is used to generate new agents in the competition phase. The computational complexity of the KMEA is analyzed, and the influence of parameter setting is also investigated. Finally, numerical simulation and comparisons are provided to demonstrate the effectiveness and efficiency of the KMEA in solving the test instances.

Abstract:As the last process of the semiconductor fabrication, the final testing is crucial to guarantee the quality of the integrated circuit products. The semiconductor final testing scheduling problem (SFTSP) is of great significance to the efficiency of the semiconductor companies. To find satisfactory solutions within reasonable computational time, the intelligent manufacturing scheduling based on the meta-heuristic methods has become a common approach. In this paper, a hybrid estimation of distribution algorithm (HEDA) is proposed to solve the SFTSP. First, novel encoding and decoding methods are proposed to map from the solution space to the schedule space effectively. Second, a probability model that describes the distribution of the solution space is built to generate the new individuals of the population. Third, a mechanism is used to update the parameters of the probability model with the superior solutions at every generation. Furthermore, to enhance the exploitation ability of the algorithm, a local search procedure is hybridized to find neighbor solutions of the promising individuals obtained by sampling the probability model. In addition, the influence of parameters is investigated based on Taguchi method of design-of-experiment, and a set of suitable parameters is suggested. Finally, numerical simulation based on some benchmark instances is carried out. The comparisons between the HEDA and some existing algorithms demonstrate the effectiveness of the proposed HEDA in solving the SFTSP.

Abstract:Silicon electrodes are widely used in semiconductor etching machines. The periodic consumption of silicon electrodes has become an important consumable in wafer manufacturing. Due to the limited number of silicon electrode manufacturers and the increasing demand for silicon electrodes in global market, the newly processed silicon electrodes need to be immediately delivered to wafer manufacturers to ensure uninterrupted production. Driven by this, this paper introduces a new integrated scheduling problem called the silicon electrode production and transportation integrated scheduling problem (SEPTISP), whose criterion is to minimize the makespan. This problem is modeled as a combination of the production scheduling subproblem (PSS) and the transportation scheduling subproblem (TSS). These two subproblems are coupled with each other. Considering the SEPTISP's NP-hard and coupling properties, a novel collaborative Q-learning hyper-heuristic evolutionary algorithm integrated with reinforcement learning scheme (CQHEA_RLS) is proposed to handle them. In the CQHEA_RLS, the production agent and the transportation agent are focused on executing exploitation in the reduced but promising regions via their specific search actions, while the joint agent is centered on performing exploration in the whole solution space through its joint search actions and determining the suitable search regions for the other two agents. Meanwhile, the joint agent also integrates the historical performance information of its own and the other two agents' search actions to dynamically choose its subsequent search actions. Moreover, each agent is devised as an effective Q-learning hyper-heuristic evolutionary algorithm. This new collaborative framework ensures that the CQHEA_RLS can continuously search downwards to obtain truly high-quality solutions in a relatively short runtime. The experimental results demonstrate that the designed algorithm can achieve better performance than the existing state-of-the-art algorithms.

Abstract:The semiconductor final test scheduling problem (SFTSP), recognized as a crucial bottleneck in the semiconductor production process, holds immense significance for improving both quality control and scheduling efficiency within chip and integrated circuit enterprises. This article introduces the knowledge-enhanced multidimensional estimation of distribution hyper-heuristic evolutionary algorithm (KMEDHEA) for addressing the SFTSP with the aim of minimizing the makespan. First, a single-vector encoding scheme is used to represent feasible solutions, and a problem-specific constrained-separable left-shift decoding scheme is devised to transform these solutions into feasible scheduling schedules. Second, eight simple yet effective heuristics with problem-specific knowledge are developed that served as a suite of low-level heuristics (LLHs) for exploring the problem solution space. Third, the multidimensional estimation of distribution algorithm (MEDA) is employed as the high-level strategy to estimate the correlations and connections of the pre-designed LLHs, thereby guiding the search scope towards high-quality individuals. Finally, critical configurations of parameters are systematically analyzed by conducting a design-of-experiment (DOE) approach. Numerical experiments are conducted on wellknown benchmark datasets, and the experimental results demonstrate the superiority of the KMEDHEA versus several state-of-the-art approaches. The best-known solutions are updated for nine out of ten benchmark instances, highlighting the effectiveness and efficiency of the proposed KMEDHEA in solving the SFTSP.

Abstract:Semiconductor manufacturing is a notoriously complex and costly multi-step process involving a long sequence of operations on expensive and quantity-limited equipment. Recent chip shortages and their impacts have highlighted the importance of semiconductors in the global supply chains and how reliant on those our daily lives are. Due to the investment cost, environmental impact, and time scale needed to build new factories, it is difficult to ramp up production when demand spikes. This work introduces a method to successfully learn to schedule a semiconductor manufacturing facility more efficiently using deep reinforcement and self-supervised learning. We propose the first adaptive scheduling approach to handle complex, continuous, stochastic, dynamic, modern semiconductor manufacturing models. Our method outperforms the traditional hierarchical dispatching strategies typically used in semiconductor manufacturing plants, substantially reducing each order's tardiness and time until completion. As a result, our method yields a better allocation of resources in the semiconductor manufacturing process.

Abstract:The semiconductor final testing scheduling problem (SFTSP) is crucial to the efficiency of the semiconductor manufacturing process. However, it is difficult to solve the problem in a short time due to its complexity. This paper is an attempt to present a simple and effective method called the compact estimation of distribution algorithm (cEDA) for solving the SFTSP. According to the characteristics of the problem, the cEDA employs the permutation based encoding and decoding schemes to obtain a solution of the SFTSP as well as its makespan value. In addition, it builds a well-designed probability model for describing the distribution of the solution space. In each generation, the probability model is sampled to generate two new solutions and updated with the superior one. With the low complexity and comparatively fewer parameters to set, the cEDA is simple and efficient. Simulation results based on benchmark instances and comparisons with some existing algorithms demonstrate the effectiveness of the proposed algorithm.

Abstract:An algorithm is presented for obtaining placements of cell-based very large scale integrated circuits, subject to timing constraints based on table-lookup model. A new timing delay model based on some delay tables of fabricators is first simplified and deduced; then it is formulated as a constrained programming problem using the new timing delay model. The approach combines the well-known quadratic placement with bottom-up clustering, as well as the slicing partitioning strategy, which has been tested on a set of sample circuits from industry and the results obtained show that it is very promising.
Learning-Based Genetic Algorithm to Schedule an Extended Flexible Job Shop

Abstract:This work considers an extended flexible job-shop scheduling problem from a semiconductor manufacturing environment. To find its high-quality solution in a reasonable time, a learning-based genetic algorithm (LGA) that incorporates a parallel long short-term memory network-embedded autoencoder model is proposed. In it, genetic algorithm is selected as a main optimizer. A novel autoencoder model is trained offline via end-to-end unsupervised learning without relying on labeled data. This model captures the major linkages among decision variables and generates promising solutions in an informative low-dimensional space, striking a balance between computational efficiency and solution quality. To further improve its search ability, a co-evolving framework is designed, which includes both a network-embedded subpopulation and a regular one. The former focuses on its global search while the latter ensures LGA's convergence. An information exchange method between the two subpopulations balances global and local search, improving its overall optimization ability. This work conducts various numerical experiments to compare LGA with the CPLEX optimizer, several classical heuristics, and some popular methods. Results show that LGA outperforms its peers in finding high-quality solutions in a reasonable time.

Abstract:Chip verification platform based on Internet or combined with cloud computing makes chip verification and test more flexible, cost-effective, and efficient. The task scheduling algorithm of the platform significantly determines its performance in handling the test tasks. This paper proposes an exponential dynamic weighted fair queuing(EDWFQ) algorithm for task scheduling in chip verification platform. The proposed algorithm makes the completion time of users be close to the result of SJF which is the best algorithm in minimizing the completion time. The proposed algorithm also solves the problem of starvation of SJF. The result demonstrates that EDWFQ scheduling algorithm has a lower user's Average Completion Time than FCFS, RR, RRSJF algorithm and has the capacity to solve the problem of starvation as FCFS, RR, RRSJF algorithm does. And the EDWFQ scheduling algorithm is successfully applied to the BR0101 chip verification platform.

Abstract:As one of the most complicated manufacturing processes, semiconductor manufacturing consists of four steps, wafer sort, wafer fabrication, assembly, and testing. Among them, wafer fabrication is the most costly, complex, and time consuming step. Its operation management and optimization are challenging modeling and scheduling researchers. To address its modeling issue, a hierarchical colored timed Petri net (HCTPN) is proposed, which can be used to describe various states, behavior and substructures of a wafer fabrication system. To address its scheduling issue, intelligent algorithms are introduced to the proposed HCTPN. An extended genetic algorithm (EGA) embedded scheduling strategy over HCTPN is studied to optimize the combination of scheduling policies. The combined approach can conduct more efficient search with better scheduling performance. At last, a real case is presented to illustrate the results. Based on comparing simulation results of different scheduling strategies, the HCTPN and EGA combined scheduling is proved to be valid and efficient.

Abstract:Semiconductor test scheduling problem is a variation of reentrant unrelated parallel machine problems considering multiple resource constraints, intricate {product, tester, kit, enabler assembly} eligibility constraints, sequence-dependant setup times, etc. A multi-step reinforcement learning (RL) algorithm called Sarsa(λ, k) is proposed and applied to deal with the scheduling problem with throughput related objective. Allowing enabler reconfiguration, the production capacity of the test facility is expanded and scheduling optimization is performed at the bottom level. Two forms of Sarsa(λ, k), i.e. forward view Sarsa(λ, k) and backward view Sarsa(λ, k), are constructed and proved equivalent in off-line updating. The upper bound of the error of the action-value function in tabular Sarsa(λ, k) is provided when solving deterministic problems. In order to apply Sarsa(λ, k), the scheduling problem is transformed into an RL problem by representing states, constructing actions, the reward function and the function approximator. Sarsa(λ, k) achieves smaller mean scheduling objective value than the Industrial Method (IM) by 68.59% and 76.89%, respectively for real industrial problems and randomly generated test problems. Computational experiments show that Sarsa(λ, k) outperforms IM and any individual action constructed with the heuristics derived from the existing heuristics or scheduling rules. © 2011 Elsevier B.V. A Greedy-Based Crow Search Algorithm for Semiconductor Final Testing Scheduling Problem

Abstract:The semiconductor final testing scheduling problem (SFTSP) is of great importance to the efficiency of integrated circuit firms and has been widely investigated in the field of intelligent optimization. In this paper, a greedy-based crow search algorithm (GCSA) is presented for solving the SFTSP. According to the characteristics of SFTSP, new encoding and decoding strategies are proposed to link the feasible solutions to the scheduling schemes. The search operations are performed only in the operation sequence space, and a corresponding ma-chine allocation vector is generated for each operation sequence vector based on the greed mechanism. Two crow position update strategies named track and hover are redesigned and the improved crow search algorithm is utilized to search the operation sequence space efficiently in order that the GCSA can adapt the SFTSP and make full use of the information obtained during the search process. Moreover, the effect of parameters is investigated based on a multi-factor analysis of variance (ANOVA) approach. Finally, extensive computations and compari-sons on ten test instances derived from the practical production demonstrate that the proposed GCSA out-performs the state-of-the-art methods in the literature to solve the SFTSP.
Integrated scheduling optimization of U-shaped automated container terminal under loading and unloading mode

Abstract:This paper proposes an integrated scheduling optimization model based on mixed integer programming to analytically characterize the U-shaped automated container terminal layout and handling technology. We focus on dual trolley quay cranes, conflict-free automated guided vehicles (AGVs) and dual cantilever rail cranes under loading and unloading mode, which have rarely been simultaneously studied in the literature, as most prior research has addressed traditional container terminals. We eliminate the waiting time during the interaction between AGV and dual cantilever rail crane to realize spatiotemporal synchronization and minimize the completion time of all tasks. We employ a reinforcement learning based hyper-heuristic genetic algorithm to solve the model, specifically, better solution results for reward and punishment mechanism incorporating reinforcement learning, higher versatility independent of specific problems, stronger scalability of low-level algorithms. We investigate which algorithm is better by comparing the proposed algorithm with bi-level genetic algorithm, adaptive genetic algorithm, hybrid genetic algorithm and cuckoo search algorithm. We conduct small-sized and large-sized experiments to validate the performance of the proposed model and algorithm. The results show that the proposed model and algorithm can not only avoid the conflicts among AGVs but also significantly improve handling efficiency.

Abstract:As the increasing complexity and capacity of large-scale integrated circuit devices, Field Programmable Gate Array (FPGA) has been widely concerned and applied with its high degree of concurrency., customizable and reconfigurable features. Thereby., the importance of efficient Electronic Design Automation (EDA) tools for modern FPGA is hard to overestimate. As a key link in the FPGA EDA design flow, the significance of placement technology for FPGA is self-evident. Simulated annealing is widely used in FPGA placement as an independent algorithm or an enhancement step of analytical placement algorithms. However, as the inherent properties of circuit cannot be utilized by the traditional simulated annealing algorithm, it depends on tremendous random swap operations, which is very time-consuming, making it cannot keep up with the increasing design scale and FPGA chip resources. In this paper, we propose an improving simulated annealing placer based on reinforcement learning. Many types of search region construction methods are proposed in which the placer can explore the solution space more efficiently, and thus can avoid exploring the redundant design space. Then, an intelligent strategy for selecting the most powerful search regions based on reinforcement learning is investigated to further ameliorate the applicability of the placer. Experimental results show that the proposed scheme can reduce the runtime while maintaining the wirelength and critical path delays compared with the simulated annealing algorithm.
A scheduling algorithm for heterogeneous computing systems by edge cover queue

Abstract:In heterogeneous computing systems, excellent task scheduling algorithms can shorten the task completion time and improve system parallelism. With the large-scale deployment of edge computing, the task scheduling algorithm in heterogeneous edge computing servers has become a critical factor in improving the overall system performance. This paper proposes a new task scheduling algorithm called the edge cover scheduling algorithm(ECSA), which schedules tasks based on the edge cover queue of the directed acyclic graph(DAG) for heterogeneous computing systems. Based on the estimation of distribution algorithm(EDA) and the graph random walk algorithm, the ECSA generates an edge cover queue from DAG. Then, the ECSA uses the heuristics greedy method with low time and computational complexity to allocate the edge cover queue to processors. Theoretical analysis and simulation results on random DAGs and real-world DAGs show that the ECSA can achieve better scheduling results in terms of makespan, the schedule length ratio(SLR), efficiency, and frequency of best results with low time and computational complexity.

Abstract:Directed acyclic graph (DAG) tasks are currently adopted in the real-time domain to model complex applications from the automotive, avionics, and industrial domains that implement their functionalities through chains of intercommunicating tasks. This paper studies the problem of scheduling real-time DAG tasks by presenting a novel schedulability test based on the concept of trivial schedulability. Using this schedulability test, we propose a new DAG scheduling framework (edge generation scheduling—EGS) that attempts to minimize the DAG width by iteratively generating edges while guaranteeing the deadline constraint. We study how to efficiently solve the problem of generating edges by developing a deep reinforcement learning algorithm combined with a graph representation neural network to learn an efficient edge generation policy for EGS. We evaluate the effectiveness of the proposed algorithm by comparing it with state-of-the-art DAG scheduling heuristics and an optimal mixed-integer linear programming baseline. Learning-Based Cuckoo Search Algorithm to Schedule a Flexible Job Shop With Sequencing Flexibility

Abstract:This work considers an extended version of flexible job-shop problem from a postprinting or semiconductor manufacturing environment, which needs a directed acyclic graph rather than a linear order to describe the precedences among operations. To obtain its reliable and high-quality schedule in a reasonable time, a learning-based cuckoo search (LCS) algorithm is presented. In it, cuckoo search is selected as an optimizer. To produce promising solutions in a high-dimensional solution space, a sparse autoencoder is introduced to compress a high-dimensional solution into an informative low-dimensional one. It extends the application area of autoencoder-embedded evolutionary optimization methods into combinational optimization by developing an improved one-hot encoding method. Then, in order to reveal the linkages among decision variables and enhance the explore ability of the proposed method, a factorization machine (FM) is used, for the first time, to capture the relevant and complementary features of population. Hence, a parallel framework involving three co-evolved subpopulations is constructed. The first one is an autoencoder embedded subpopulation, the second one is assisted by an FM, and the last one undergoes a regular iteration process. To balance the exploration and exploitation of the proposed framework and avoid unnecessary computation, a reinforcement learning algorithm is used to adaptively adjust the proportion of subpopulations and tune parameters of each subpopulation iteratively. Numerical simulations with benchmarks are performed to compare it with CPLEX, some classical heuristics, and several recently developed methods. The results shows that it well outperforms them.

Abstract:An effective shuffled frog-leaping algorithm (SFLA) is proposed in this paper to solve the batch scheduling problem in semiconductor furnace. To map integer matrix based individuals to feasible schedules, a new bi-sequence based decoding method is presented. To balance exploration and exploitation capabilities, a crossover scheme and a local search operator for the specific problem are incorporated in the framework of the SFLA. Finally, numerical testing results are provided based on three instances and a real case. The comparisons demonstrate the effectiveness of the proposed algorithm.
