Abstract:The evaluation of thermoelectric materials relies significantly on the thermoelectric figure of merit, ZT, which serves as a crucial parameter in assessing their properties. The accurate prediction of ZT values can be accomplished by utilizing machine learning models to learn material characteristics. However, factors such as the size of the dataset, model hyperparameters, and data quality can all impact the accuracy of machine learning. In contrast to previous research where high-dimensional features were simply discarded to transform them into low-dimensional ones, deep learning models such as autoencoder can extract more effective information. Therefore, in this article, the combination of autoencoders and the Light Gradient Boosting Machine (LightGBM) is employed to learn the chemical characteristics and ZT values of various materials. The reliability of the model was confirmed by achieving an R2 score of 0.94 during tenfold cross-validation. 130 000 materials were predicted and screened, the temperature dependence of the screened materials was studied in depth, and 13 materials with high ZT values were identified. Four of the 13 most promising candidates identified are existing thermoelectric materials, while nine are ideal candidates for future experimental studies and validation. This work utilizes autoencoders for extensive prediction and screening of promising materials, providing an effective approach for handling high-dimensional material data.

Combining Machine Learning Models with First-Principles High-Throughput Calculation to Accelerate the Search of Promising Thermoelectric Materials

Abstract:Thermoelectric materials can achieve direct energy conversion between electricity and heat, thus can be applied to waste heat harvesting and solid-state cooling. The discovery of new thermoelectric materials is mainly based on experiments and first-principles calculations. However, these methods are usually expensive and time-consuming. Recently, the prediction of properties via machine learning has emerged as a popular method in materials science. Herein, we firstly did first-principles high-throughput calculations for a large number of chalcogenides and built a thermoelectric database containing 796 compounds. Many novel and promising thermoelectric materials were discovered. Then, we trained four ensemble learning models and two deep learning models to distinguish the promising thermoelectric materials from the others for n type and p type doping, respectively. All the presented models achieve classification accuracy higher than 85% and area under the curve (AUC) higher than 0.9. Especially, the M3GNet model for n type data achieve accuracy, precision and recall all higher than 90%. Our works demonstrate a very efficient way of combining machine learning prediction and first-principles high-throughput calculations together to accelerate the discovery of advanced thermoelectric materials.

Abstract:In this work, we employed a machine learning framework to predict the thermoelectric power factors of materials based on their composition and structure. To generate a broad range of materials for analysis, we sourced an existing dataset from the Materials Project database. The electronic transport properties, which serve as the output variables, were obtained from the same database via a Boltzmann transport theory calculation beyond ab-initio method. These properties were used to generate input data, or material descriptors, which rely solely on atomic information and crystal structure without recourse to density functional theory calculations. The descriptors were transformed into numerical features using the open-source software Matminer. Non-linear machine learning regression models were trained and tested on the transformed datasets, and their performance was evaluated. The optimized random forest model produced the most accurate predictions, with a yield of 88%. The ultimate goals of this research were to develop material selection strategies that bypass the need for self-consumption in density functional theory calculations, and to demonstrate the potential of machine learning models to describe the thermoelectric properties of existing materials datasets.

Abstract:This study uses the StarryData2 database to develop an ML model for predicting the figure‐of‐merit (ZT) of thermoelectric materials. After systematic cleaning, the dataset includes 18,126 instances with 2,761 unique compounds. The XGBoost regressor achieves high prediction accuracy with an R2 score of 0.815, offering insights and accelerating the discovery of improved thermoelectric materials. In recent years, machine learning (ML) has emerged as a potential tool in the exploration of thermoelectric (TE) materials. This study exploits the StarryData2 public database to construct an ML model for predicting the figure‐of‐merit ZT of TE materials. The original dataset from StarryData2 (372,480 datapoints) underwent systematic cleaning, resulting in a refined dataset of 18,126 instances with 2,761 unique compounds. The cleaned data is employed to train an XGBoost regressor model, utilizing chemical formulas of TE compounds as features to predict ZT at given temperatures. The XGBoost regressor exhibited high prediction accuracy, achieving the coefficient of determination (R2) scores of 0.815 and mean absolute error (MAE) of 0.103 for the test set, further evaluated through cross‐validation across 5 folds. The learning curve analysis demonstrated improved model performance with increased training data. Furthermore, the contributions of different chemical descriptors to ZT are analyzed based on feature importance analysis. Beyond conventional TE families in the training set, the trained model is applied to predict ZT for promising unexplored TE materials and estimate optimal doping concentrations. This comprehensive study shows the impact of ML on TE material research, offering valuable insights and accelerating the discovery of materials with enhanced TE properties.

Predicting Thermoelectric Transport Properties from Composition with Attention-based Deep Learning

Abstract:Thermoelectric materials can be used to construct devices which recycle waste heat into electricity. However, the best known thermoelectrics are based on rare, expensive or even toxic elements, which limits their widespread adoption. To enable deployment on global scales, new classes of effective thermoelectrics are thus required. $\textit{Ab initio}$ models of transport properties can help in the design of new thermoelectrics, but they are still too computationally expensive to be solely relied upon for high-throughput screening in the vast chemical space of all possible candidates. Here, we use models constructed with modern machine learning techniques to scan very large areas of inorganic materials space for novel thermoelectrics, using composition as an input. We employ an attention-based deep learning model, trained on data derived from $\textit{ab initio}$ calculations, to predict a material's Seebeck coefficient, electrical conductivity, and power factor over a range of temperatures and $\textit{n}$- or $\textit{p}$-type doping levels, with surprisingly good performance given the simplicity of the input, and with significantly lower computational cost. The results of applying the model to a space of known and hypothetical binary and ternary selenides reveal several materials that may represent promising thermoelectrics. Our study establishes a protocol for composition-based prediction of thermoelectric behaviour that can be easily enhanced as more accurate theoretical or experimental databases become available.

Abstract:The development of artificial intelligence (AI), particularly, data science and machine learning (ML), is revolutionizing the field of material science. Yet, some inevitable key challenges remain, including errors contained in large-scale material datasets and the overfitting of predicted temperature-dependent properties. In this work, using thermoelectric (TE) materials as an archetypal example, we firstly performed a series of rational actions to identify and discard questionable data, and obtained 92,291 data points consisting of 7295 compositions and different temperatures from the Starrydata2 database. Next, we proposed a composition-based cross-validation method to emphasize that the data points with the same compositions but different temperatures should not be split into different sets to avoid overfitting. Then, we built ML models using the gradient boosting decision tree (GBDT) method, and achieved remarkable R 2 values of ∼0.89, ∼0.90, and ∼0.89 on the training dataset, test dataset, and new out-of-sample experimental data published in 2023, verifying the model's high accuracy in predicting newly available materials. Using this ML model, we carried out a large-scale evaluation of the stable materials from the Materials Project database, and Ge 2 Te 5 As 2 and Ge 3 (Te 3 As) 2 were predicted to exhibit high zT values. Density functional theory calculations were then executed and the calculated maximum zT values were 1.98 and 2.12 for n- and p-type Ge 2 Te 5 As 2 , and 0.58 and 0.74 for n- and p-type Ge 3 (Te 3 As) 2 , respectively, indicating their potential as TE materials and supporting our ML model. This work presents an example of dealing with and overcoming big data challenges in AI for materials science.

Abstract:<p>Traditional experimental methods and calculation methods have troublesome steps and long cycles for predicting new thermoelectric materials. Here, a machine learning method used to identify the thermoelectric materials with high efficiency and accuracy is introduced. Furthermore, the relationship between features and thermoelectric performance is discovered by model decomposition and feature combination analysis. The data is extracted from the MRL database to generate a dataset. Then the feature selection is based on the information entropy evaluation of the ExtraTree-based model to exclude dependent and redundant features and obtained the minimum complexity model of 4 features. According to the data set, five different machine learning models are trained and tested, it is found that the Random Forest model is the best choice. The model decomposition and feature combination analysis are attempted to discover the relationship between features and thermoelectric performance. Finally, we use the 4 features that have the most contribution to the thermoelectric performance to reduce a search space of more than 130,000 systems to a set of 6476 candidates. Among the 10 most promising candidates identified, 4 are the existing thermoelectric materials and 6 are ideal candidate materials for future experimental investigation and validation, thus providing important information for the further examination of thermoelectric materials. The approach used in this work is not limited to the search of thermoelectric materials and can be applied in searching for other functional materials.</p>

Abstract:Thermoelectric materials play a pivotal role in harnessing waste heat and converting it into valuable electrical energy, addressing energy sustainability challenges. This study introduces an innovative methodology to predict essential thermoelectric properties—thermal conductivity (), electrical conductivity (), Seebeck coefficient (S), and the figure of merit (ZT) —solely from the chemical formula of materials. Employing advanced machine learning (ML) techniques, including random forest, Gradient Boosting Regression, XGBRegressor, and Neural Network, we developed a robust predictive model utilizing a diverse dataset of thermoelectric compounds. Notably, random forest exhibits outstanding predictive performance, boasting R2 values of 0.91, 0.95, 0.95, and 0.90 for , , S and ZT, respectively. While testing the prediction competency of thermoelectric parameters of Bi2Te1-xSex using a random forest model, the model provides a very consistent quantitative prediction with experimental , , S and ZT. Further, the , , S and ZT of Bi2Te2Se were calculated using the first principles density functional theory and Boltzmann transport equation to compare the corresponding ML-predicted thermoelectric properties. Although the order of theoretical values of , , S and ZT of Bi2Te2Se is consistent with the room temperature ML prediction, the temperature-dependent theoretical value of , , S and ZT of Bi2Te2Se shows a deviation from the ML-prediction values as the model is trained with the experimental data. The findings highlight the superiority of classification-based models in capturing complex patterns. By leveraging chemical composition as the exclusive input, our streamlined approach eliminates the need for extensive laboratory experiments. This research significantly propels the advancement of high-performance thermoelectric materials, offering an efficient pathway for exploration and optimization, thus revolutionizing the field of materials science. Moreover, it opens avenues for accelerated discovery and innovation in energy conversion technologies.

Abstract:Abstract Layered IV-V-VI semiconductors have immense potential for thermoelectric (TE) applications due to their intrinsically ultralow lattice thermal conductivity. However, it is extremely difficult to assess their TE performance via experimental trial-and-error methods. Here, we present a machine-learning-based approach to accelerate the discovery of promising thermoelectric candidates in this chalcogenide family. Based on a dataset generated from high-throughput ab initio calculations, we develop two highly accurate-and-efficient neural network models to predict the maximum ZT ( ZT max ) and corresponding doping type, respectively. The top candidate, n-type Pb 2 Sb 2 S 5 , is successfully identified, with the ZT max over 1.0 at 650 K, owing to its ultralow thermal conductivity and decent power factor. Besides, we find that n-type Te-based compounds exhibit a combination of high Seebeck coefficient and electrical conductivity, thereby leading to better TE performance under electron doping than hole doping. Whereas p-type TE performance of Se-based semiconductors is superior to n-type, resulting from large Seebeck coefficient induced by high density-of-states near valence band edges.

Abstract:Machine learning (ML) is increasingly being adopted to accelerate the development of materials research. In this work, we applied the ML approach to predict the figure-of-merit (ZT) of thermoelectric (TE) materials. The experimental datasets were gathered from 150 published articles for five high-performance TE groups in the mid-temperature range, i.e., PbTe, Co4Sb12, Mg2Si, BiCuSeO, and Cu2Se, resulting in 1563 data points in total. The chemical formulas of individual compounds, including the dopant types and concentrations, were extracted as ML features using the Magpie software. The ZT value was set as the target value. The model was built based on different regression algorithms, and its accuracy for predicting ZT was evaluated using the coefficient of determination (R2) and the root mean squared error (RMSE). It was found that the model’s accuracy increased with increasing datasets and by incorporating features from experimental parameters (measurement temperature, sintering temperature, and sintering pressure). The final ML model showed relatively high accuracy, with an R2 of 0.859 and an RMSE of 0.156 for a test set. It means that the model can confidently predict the ZT of specific doped compounds in the selected TE groups. To utilize the model effectively, it is implemented as a webpage application with a user-friendly interface so that researchers without ML expertise can explore the ZT values of the doped TE materials. It will certainly be beneficial for experimentalists as a guideline for designing their experiments.

Abstract:In previous laboratory preparation processes, the selection and proportioning of specific experimental parameters often stemmed from the empirical experience of predecessors, necessitating the derivation of the optimal scheme for the target experiment through extensive trial and error. This process typically required the consumption of substantial resources and time. Thanks to the advancement of machine learning technologies, these have gradually become a powerful tool for addressing complex functional problems in material optimization. This study is based on a collected database of thermoelectric materials, aiming to clarify the correspondence between physical characteristics and the thermoelectric figure of merit, zT. The key features that can directly affect the experimental results are identified, and the features that indirectly affect the experimental results are also analyzed. Employing interpretable machine learning methods, this research analyzes critical molecular features in the characterized data, utilizing feature engineering techniques to construct and optimize machine learning models for the selected key features. Furthermore, in the subsequent model fitting and analysis phase, by comparing the efficiency of different feature combinations, the optimal feature descriptors for the current experimental system were determined. The adoption of the aforementioned improved methods endowed the related models with the potential for high-throughput screening, thereby further enhancing the efficiency of experimental optimization.

Abstract:Thermoelectric (TE) materials provide a solid‐state solution in waste heat recovery and refrigeration. During the past few decades, considerable effort has been devoted towards improving the performance of TE materials, which requires the optimization of multiple interrelated properties. A fundamental understanding of the interaction processes between the various energy carriers, such as electrons and phonons, is critical for advances in the development of TE materials. However, this understanding remains challenging primarily due to the inaccessibility of time scales using standard atomistic simulations. Machine learning methods, well known for their data‐analysis capability, have been successfully applied in research on TE materials in recent years. Here, an overview of the machine learning methods used in thermoelectric studies is provided, with the role that each machine learning method plays being systematically discussed. Furthermore, to date, the scale of thermoelectric‐related databases is much smaller than those in other fields, such as e‐commerce, image identification, and speech recognition. To overcome this limitation, possible strategies to utilize small databases in promoting materials science are also discussed. Finally, a brief conclusion and outlook are presented.

Abstract:The application of machine learning (ML)-based methods to the study of thermoelectric (TE) materials is promising. Although conventional ML algorithms can achieve high prediction performance, their lack of interpretability severely obstructs researchers from extracting material-oriented insights from ML models. In this work, high ML-based prediction performance was achieved with respect to TE power factors (PFs), and the results were well understood by the SHapley Additive exPlanations (SHAP), a method to identify the correlations between targets and descriptors. We designed a robust PF prediction model for diamond-like compounds via a stacking technique, and the model achieved a coefficient of determination value above 0.95 on the test set. From the SHAP analysis, the PFs were negatively correlated with electronegativity and positively correlated with the descriptor “volume per atom” based on the previously reported dataset. TE domain knowledge was adopted to understand these correlations. This work shows that ML models can achieve high accuracy while exhibiting good interpretability, making them useful for materials scientists.

Abstract:Abstract The Materials Genome Initiative requires the crossing of material calculations, machine learning, and experiments to accelerate the material development process. In recent years, data-based methods have been applied to the thermoelectric field, mostly on the transport properties. In this work, we combined data-driven machine learning and first-principles automated calculations into an active learning loop, in order to predict the p-type power factors (PFs) of diamond-like pnictides and chalcogenides. Our active learning loop contains two procedures (1) based on a high-throughput theoretical database, machine learning methods are employed to select potential candidates and (2) computational verification is applied to these candidates about their transport properties. The verification data will be added into the database to improve the extrapolation abilities of the machine learning models. Different strategies of selecting candidates have been tested, finally the Gradient Boosting Regression model of Query by Committee strategy has the highest extrapolation accuracy (the Pearson R = 0.95 on untrained systems). Based on the prediction from the machine learning models, binary pnictides, vacancy, and small atom-containing chalcogenides are predicted to have large PFs. The bonding analysis reveals that the alterations of anionic bonding networks due to small atoms are beneficial to the PFs in these compounds.

This huge promise of energy harvesting is contingent on identifying/designing materials having higher efficiency than presently available ones. However, due to the vastness of the chemical space of materials, only its small fraction was scanned experimentally and/or computationally so far. Employing a compressed-sensing based symbolic regression in an active-learning framework, we have not only identified a trend in materials' compositions for superior TE performance, but have also predicted and experimentally synthesized several extremely high performing novel TE materials. Among these, we found Ag$_{0.55}$Cu$_{0.45}$GaTe$_2$ to possess an experimental figure of merit as high as ~2.8 at 827 K, which is a breakthrough in the field. The presented methodology demonstrates the importance and tremendous potential of physically informed descriptors in material science, in particular for relatively small data sets typically available from experiments at well-controlled conditions.
