Abstract:The term “Big Data” evokes emotions ranging from excitement to exasperation in the statistics community. Looking beyond these emotions reveals several important changes that affect us as statisticians and as humans. I focus on Behavioral Big Data (BBD), or very large and rich multidimensional datasets on human behaviors, actions and interactions, which have become available to companies, governments, and researchers. The paper describes the BBD landscape and examines opportunities and critical issues that arise when applying statistical and data mining approaches to Behavioral Big Data, including the move from macro- to micro-decisioning and its implications.

Abstract:The capacity to collect and analyse data is growing exponentially. Referred to as ‘Big Data’, this scientific, social and technological trend has helped create destabilising amounts of information, which can challenge accepted social and ethical norms. Big Data remains a fuzzy idea, emerging across social, scientific, and business contexts sometimes seemingly related only by the gigantic size of the datasets being considered. As is often the case with the cutting edge of scientific and technological progress, understanding of the ethical implications of Big Data lags behind. In order to bridge such a gap, this article systematically and comprehensively analyses academic literature concerning the ethical implications of Big Data, providing a watershed for future ethical investigations and regulations. Particular attention is paid to biomedical Big Data due to the inherent sensitivity of medical information. By means of a meta-analysis of the literature, a thematic narrative is provided to guide ethicists, data scientists, regulators and other stakeholders through what is already known or hypothesised about the ethical risks of this emerging and innovative phenomenon. Five key areas of concern are identified: (1) informed consent, (2) privacy (including anonymisation and data protection), (3) ownership, (4) epistemology and objectivity, and (5) ‘Big Data Divides’ created between those who have or lack the necessary resources to analyse increasingly large datasets. Critical gaps in the treatment of these themes are identified with suggestions for future research. Six additional areas of concern are then suggested which, although related have not yet attracted extensive debate in the existing literature. It is argued that they will require much closer scrutiny in the immediate future: (6) the dangers of ignoring group-level ethical harms; (7) the importance of epistemology in assessing the ethics of Big Data; (8) the changing nature of fiduciary relationships that become increasingly data saturated; (9) the need to distinguish between ‘academic’ and ‘commercial’ Big Data practices in terms of potential harm to data subjects; (10) future problems with ownership of intellectual property generated from analysis of aggregated datasets; and (11) the difficulty of providing meaningful access rights to individual data subjects that lack necessary resources. Considered together, these eleven themes provide a thorough critical framework to guide ethical assessment and governance of emerging Big Data practices.

Abstract:The recent interest in Big Data has generated a broad range of new academic, corporate, and policy practices along with an evolving debate amongst its proponents, detractors, and skeptics. While the practices draw on a common set of tools, techniques, and technologies, most contributions to the debate come either from a particular disciplinary perspective or with an eye on a domain-specific issue. A close examination of these contributions reveals a set of common problematics that arise in various guises in different places. It also demonstrates the need for a critical synthesis of the conceptual and practical dilemmas surrounding Big Data. The purpose of this article is to provide such a synthesis by drawing on relevant writings in the sciences, humanities, policy, and trade literature. In bringing these diverse literatures together, we aim to shed light on the common underlying issues that concern and affect all of these areas. By contextualizing the phenomenon of Big Data within larger socio-economic developments, we also seek to provide a broader understanding of its drivers, barriers, and challenges. This approach allows us to identify attributes of Big Data that need to receive more attention--autonomy, opacity, and generativity, disparity, and futurity--leading to questions and ideas for moving beyond dilemmas.

Abstract:This book presents cutting edge research on the new ethical challenges posed by biomedical Big Data technologies and practices. ‘Biomedical Big Data’ refers to the analysis of aggregated, very large datasets to improve medical knowledge and clinical care. The book describes the ethical problems posed by aggregation of biomedical datasets and re-use/re-purposing of data, in areas such as privacy, consent, professionalism, power relationships, and ethical governance of Big Data platforms. Approaches and methods are discussed that can be used to address these problems to achieve the appropriate balance between the social goods of biomedical Big Data research and the safety and privacy of individuals. Seventeen original contributions analyse the ethical, social and related policy implications of the analysis and curation of biomedical Big Data, written by leading experts in the areas of biomedical research, medical and technology ethics, privacy, governance and data protection. The book advances our understanding of the ethical conundrums posed by biomedical Big Data, and shows how practitioners and policy-makers can address these issues going forward.

Abstract:This paper analyzes the ethics of social science research (SSR) employing big data. We begin by highlighting the research gap found on the intersection between big data ethics, SSR and research ethics. We then discuss three aspects of big data SSR which make it warrant special attention from a research ethics angle: (1) the interpretative character of both SSR and big data, (2) complexities of anticipating and managing risks in publication and reuse of big data SSR, and (3) the paucity of regulatory oversight and ethical recommendations on protecting individual subjects as well as societies when conducting big data SSR. Against this backdrop, we propose using David Resnik's research ethics framework to analyze some of the most pressing ethical issues of big data SSR. Focusing on the principles of honesty, carefulness, openness, efficiency, respect for subjects, and social responsibility, we discuss three clusters of ethical issues: those related to methodological biases and personal prejudices, those connected to risks arising from data availability and reuse, and those leading to individual and social harms. Finally, we advance considerations to observe in developing future ethical guidelines about big data SSR.

Abstract:The era of Big Data has begun. Computer scientists, physicists, economists, mathematicians, political scientists, bio-informaticists, sociologists, and other scholars are clamoring for access to the massive quantities of information produced by and about people, things, and their interactions. Diverse groups argue about the potential benefits and costs of analyzing genetic sequences, social media interactions, health records, phone logs, government records, and other digital traces left by people. Significant questions emerge. Will large-scale search data help us create better tools, services, and public goods? Or will it usher in a new wave of privacy incursions and invasive marketing? Will data analytics help us understand online communities and political movements? Or will it be used to track protesters and suppress speech? Will it transform how we study human communication and culture, or narrow the palette of research options and alter what ‘research’ means? Given the rise of Big Data as a socio-technical phenomenon, we argue that it is necessary to critically interrogate its assumptions and biases. In this article, we offer six provocations to spark conversations about the issues of Big Data: a cultural, technological, and scholarly phenomenon that rests on the interplay of technology, analysis, and mythology that provokes extensive utopian and dystopian rhetoric.

Abstract:Big data are certainly an essential component of digital science and technology and also of machine learning, robotics, and new means of communication. They are also part of the digital revolution that is shaking our society to its very roots. The information that the data initially contain, is considerably enriched by cross-referencing data. Highly diverse, these data can berelated to health or well-being. One of the characteristics of big data in health is the blurring of the distinctions underpinningimplementation of the ethical principles that promote the protection of individual rights in health. Precise knowledge of individuals and of their state of health creates a risk of profiling, which threatens the protection of private life and may lead to stigmatization of people or groups. Such stigmatization threatens private life, but also the principles of solidarity and equity which are the basis of our health system. Care and business are becoming increasingly hard to distinguish, as aresult of the transformation of care and of the healthcare market. In addition, ethical principles can be weakened by the exploitation of big data: medical confidentiality, the responsibility of the medical decision and the personal relationship between the doctor and patient. The need for protection of the in-dividual must be reaffirmed and its modalities redefined, to dispel the threat of a society under the surveillance and control of multiple providers acting for various purposes.

Abstract:AbstractOften times terms such as Big Data, increasing digital footprints in the Internet accompanied with advancing analytical techniques, represent a major opportunity to improve public health surveillance and delivery of interventions. However, early adaption of Big Data in other fields revealed ethical challenges that could undermine privacy and autonomy of individuals and cause stigmatization. This chapter aims to identify the benefits and risks associated with the public health application of Big Data through ethical lenses. In doing so, it highlights the need for ethical discussion and framework towards an effective utilization of technologies. We then discuss key strategies to mitigate potentially harmful aspects of Big Data to facilitate its safe and effective implementation.

Abstract:Abstract Background Ethics review is the process of assessing the ethics of research involving humans. The Ethics Review Committee (ERC) is the key oversight mechanism designated to ensure ethics review. Whether or not this governance mechanism is still fit for purpose in the data-driven research context remains a debated issue among research ethics experts. Main text In this article, we seek to address this issue in a twofold manner. First, we review the strengths and weaknesses of ERCs in ensuring ethical oversight. Second, we map these strengths and weaknesses onto specific challenges raised by big data research. We distinguish two categories of potential weakness. The first category concerns persistent weaknesses, i.e., those which are not specific to big data research, but may be exacerbated by it. The second category concerns novel weaknesses, i.e., those which are created by and inherent to big data projects. Within this second category, we further distinguish between purview weaknesses related to the ERC’s scope (e.g., how big data projects may evade ERC review) and functional weaknesses, related to the ERC’s way of operating. Based on this analysis, we propose reforms aimed at improving the oversight capacity of ERCs in the era of big data science. Conclusions We believe the oversight mechanism could benefit from these reforms because they will help to overcome data-intensive research challenges and consequently benefit research at large.

Abstract:The advent of Behavioral Big Data (BBD) has profoundly impacted research ethics. At the same time, academic disciplines with no experience in human subjects research increasingly make use of BBD datasets. In this first-of-its-kind study, we evaluate Taiwan academic researchers’ knowledge and awareness of data ethics using a series of four BBD-based hypothetical research scenarios. We uncover several data ethics blind spots affecting academic researchers. Through the results of this research we hope to strengthen academic researchers’ data ethics awareness and knowledge in the context of BBD, and provide suggestions for improving the ethics training of academic researchers conducting BBD studies. We also contribute a re-conceptualization of data ethics encompassing both traditional human subjects research ethics and new paradigms for the regulation of personal data, such as the General Data Protection Regulation (GDPR).

Abstract:How often do we reflect on the potential moral or value implications – what is right, wrong, has value and is (in)appropriate – of seemingly trivial analytical decisions, such as how to dichotomise a variable? I argue that analytical choices relate to multifaceted and oftentimes challenging moral issues that scientists should take into deeper consideration. Here, I illustrate a variety of potential considerations about moral values, including issues like exclusion, marginalisation, autonomy, responsibility, non-maleficence in relation to various common analytical choices and practices, such as the use of thresholds for disease diagnosis or population definition, the use of composite measures in the context of clarifying effects, classification practices, decisions on variable selection, as well as decisions relating to (dis)aggregation of data. I discuss these examples in the context of reasonable theoretical or statistical reservations. I advocate for deeper engagement with the difficult moral implications of analytical decisions, and for a principled and pluralistic science, that is also a more robust science. Such a science can include diverse moral views through a coupled ethical-epistemic approach, sensitivity tests, multiverse analysis, as well as stronger commitments to participatory and mutual learning practices.

However, this data-driven landscape raises concerns about individual privacy and data security. As personal information collection and analysis become more prevalent, robust privacy approaches are imperative. This research paper conducts a comparative analysis of privacy approaches in the context of big data and data-driven decision-making. It examines traditional methods such as cryptography, anonymization, and access controls, alongside emerging techniques like differential privacy, homomorphic encryption, and secure multi-party computation. Qualitative content analysis and thematic coding gather insights from academic literature, reports, and expert interviews. The findings highlight each approach's strengths, limitations, and trade-offs, offering valuable insights for organizations aiming to balance data utility with privacy preservation. This study contributes to understanding ethical concerns, legal compliance, data quality, trust, and technological advancements in the pursuit of responsible data-driven decision-making while safeguarding privacy. Understanding Individual Subject Differences through Large Behavioral Datasets: Analytical and Statistical Considerations

Abstract:A core feature of behavior analysis is the single-subject design, in which each subject serves as its own control. This approach is powerful for identifying manipulations that are causal to behavioral changes but often fails to account for individual differences, particularly when coupled with a small sample size. It is more common for other subfields of psychology to use larger-N approaches; however, these designs also often fail to account for the individual by focusing on aggregate-level data only. Moving forward, it is important to study individual differences to identify subgroups of the population that may respond differently to interventions and to improve the generalizability and reproducibility of behavioral science. We propose that large-N datasets should be used in behavior analysis to better understand individual subject variability. First, we describe how individual differences have been historically treated and then outline practical reasons to study individual subject variability. Then, we describe various methods for analyzing large-N datasets while accounting for the individual, including correlational analyses, machine learning, mixed-effects models, clustering, and simulation. We provide relevant examples of these techniques from published behavioral literature and from a publicly available dataset compiled from five different rat experiments, which illustrates both group-level effects and heterogeneity across individual subjects. We encourage other behavior analysts to make use of the substantial advancements in online data sharing to compile large-N datasets and use statistical approaches to explore individual differences.

Abstract:Mental health conditions cause a great deal of distress or impairment; depression alone will affect 11% of the world's population. The application of Artificial Intelligence (AI) and big-data technologies to mental health has great potential for personalizing treatment selection, prognosticating, monitoring for relapse, detecting and helping to prevent mental health conditions before they reach clinical-level symptomatology, and even delivering some treatments. However, unlike similar applications in other fields of medicine, there are several unique challenges in mental health applications which currently pose barriers towards the implementation of these technologies. Specifically, there are very few widely used or validated biomarkers in mental health, leading to a heavy reliance on patient and clinician derived questionnaire data as well as interpretation of new signals such as digital phenotyping. In addition, diagnosis also lacks the same objective 'gold standard' as in other conditions such as oncology, where clinicians and researchers can often rely on pathological analysis for confirmation of diagnosis. In this chapter we discuss the major opportunities, limitations and techniques used for improving mental healthcare through AI and big-data. We explore both the computational, clinical and ethical considerations and best practices as well as lay out the major researcher directions for the near future.
Addressing Conceptual Gaps in Big Data Research Ethics: An Application of Contextual Integrity

Abstract:The rise of big data has provided new avenues for researchers to explore, observe, and measure human opinions, activities, and interactions. While scholars, professional societies, and ethical review boards have long-established research ethics frameworks to ensure the rights and welfare of the research subjects are protected, the rapid rise of big data-based research generates new challenges to long-held ethical assumptions and guidelines. This article discloses emerging conceptual gaps in relation to how researchers and ethical review boards think about privacy, anonymity, consent, and harm in the context of big data research. It closes by invoking Nissenbaum’s theory of “privacy as contextual integrity” as a useful heuristic to guide ethical decision-making in big data research projects.

Abstract:The exponential accumulation, processing and accrual of big data in healthcare are only possible through an equally rapidly evolving field of big data analytics. The latter offers the capacity to rationalize, understand and use big data to serve many different purposes, from improved services modelling to prediction of treatment outcomes, to greater patient and disease stratification. In the area of infectious diseases, the application of big data analytics has introduced a number of changes in the information accumulation models. These are discussed by comparing the traditional and new models of data accumulation. Big data analytics is fast becoming a crucial component for the modelling of transmission-aiding infection control measures and policies-emergency response analyses required during local or international outbreaks. However, the application of big data analytics in infectious diseases is coupled with a number of ethical impacts. Four key areas are discussed in this paper: (i) automation and algorithmic reliance impacting freedom of choice, (ii) big data analytics complexity impacting informed consent, (iii) reliance on profiling impacting individual and group identities and justice/fair access and (iv) increased surveillance and population intervention capabilities impacting behavioural norms and practices. Furthermore, the extension of big data analytics to include information derived from personal devices, such as mobile phones and wearables as part of infectious disease frameworks in the near future and their potential ethical impacts are discussed. Considered together, the need for a constructive and transparent inclusion of ethical questioning in this rapidly evolving field becomes an increasing necessity in order to provide a moral foundation for the societal acceptance and responsible development of the technological advancement.
