A Novel Depth-Transfer Deep Learning Method for Soil Mapping

Abstract:Accurate, robust and cost-effective mapping of soil properties such as soil organic carbon(SOC) is essential for supporting policy decision. Soil properties changes with depth, but environmental covariates used in soil mapping usually has the same value at the same location, which may be insufficient to characterize vertical variation soil properties. Meanwhile, only applying the soil depth as a covariate based on digital soil mapping models may not accurately predict SOC at specific depths. To address this challenge, we propose a novel depth-transfer deep learning method based on 2D-CNN (two-dimensional Convolutional Neural Networks) model for improving the predictions of SOC at each soil depth. We first applied data from all depths to train 2D-CNN models, and transferred them by using data at each depth. Two independent experiments by cross-validation are conducted to investigate the prediction accuracy: depth-to-depth experiment (the root mean square ( RMSE ) is 2.547 %, and the explained variation ( R 2 ) is 0.668) and profile-to-profile experiment (the RMSE is 2.937 % and R 2 is 0.374). Depth-transfer model generally has advantages over other machine learning models, including Random Forests (RF) and 2D-CNN. The profile-to-profile method is advocated in correctly evaluate model’s ability in spatial prediction instead of the depth-to-depth method. Overall, the relative high accuracy of our depth-transfer deep learning method ensured its applicability to represent the horizontal-vertical variations of soil properties well.
