Abstract:Sewer corrosion is a widespread and costly issue for water utilities. Knowing the corrosion status of a sewer network could help the water utility to improve efficiency and save costs in sewer pipe maintenance and rehabilitation. However, inspecting the corrosion status of all sewer pipes is impractical. To prioritize sewer pipes in terms of corrosion risk, the water utility requires a corrosion prediction model built on influential factors that cause sewer corrosion, such as hydrogen sulphide (H\(_2\)S) and temperature. Unfortunately, monitoring sites of influential factors are very sparse on the sewer network such that a reliable prediction has often been hampered by insufficient observations – It is a challenge to predict H\(_2\)S distribution and sewer corrosion levels on the entire sewer network with a limited number of monitoring sites. This work leverages a Bayesian nonparametric method, Gaussian Process, to integrate the physical model developed by domain experts, the sparse H\(_2\)S and temperature monitored records, and the sewer geometry to predict corrosion risk levels on the entire sewer network. A case study has been conducted on a real data set of a water utility in Australia. The evaluation results well demonstrate the effectiveness of the model and admit promising applications for water utilities, including prioritizing high corrosion areas and recommending chemical dosing profiles.
Evaluation of Data-Driven Models for Predicting the Service Life of Concrete Sewer Pipes Subjected to Corrosion.

Abstract:Concrete corrosion is one of the most significant failure mechanisms of sewer pipes, and can reduce the sewer service life significantly. To facilitate the management and maintenance of sewers, it is essential to obtain reliable prediction of the expected service life of sewers, especially if that is based on limited environmental conditions. Recently, a long-term study was performed to identify the controlling factors of concrete sewer corrosion using well-controlled laboratory-scale corrosion chambers to vary levels of H2S concentration, relative humidity, temperature and in-sewer location. Using the results of the long-term study, three different data-driven models, i.e. multiple linear regression (MLR), artificial neural network (ANN), and adaptive neuro fuzzy inference system (ANFIS), as well as the interaction between environmental parameters, were assessed for predicting the corrosion initiation time (ti) and corrosion rate (r). This was performed using the sewer environmental factors as the input under 12 different scenarios after allowing for an initiation corrosion period. ANN and ANFIS models showed better performance than MLR models, with or without considering the interactions between environmental factors. With the limited input data available, it was observed that ti prediction by these models is quite sensitive, however, they are more robust for predicting r as long as the H2S concentration is available. Using the H2S concentration as a single input, all three data driven models can reasonably predict the sewer service life.
Failure Prediction and Reliability Analysis of Buried Grey Cast Iron Water Mains Considering Corrosion

Abstract:To resolve the serious breakage and leakage problems for the grey cast iron water mains buried in the early years in the water-supply system, pipe stresses were firstly calculated based on the pipe soil inter-action model, and the corrosion depth was predicted by the corrosion model. Then, the residual strength associated with corrosion was evaluated, and a failure prediction model was given by using the failure crite-rion for the cast iron. Monte Carlo (MC) simulations were used to perform the probabilistic analysis. The given model fully considers the influences of corrosion, external loads and uncertainties on the pipe failure. Results show that the pipes will not be failed when only considering the external loads. The corrosion is one of the very important factors contributing to the pipe failure. The probability density distribution of the safety factor of the pipe appears a lognormal distribution. The hazard of the pipe failure is large in 20-50 years, and it becomes small after 80 years and decreases with the time. The influence on the failure probability is large for considering soil bedding lost induced by the breakage or uneven settlement when the corrosion depth reaches a certain depth.

Abstract:Predictive maintenance decisions can promote resilient sewers, however, interpretable and accurate corrosion predictions are challenging because of the dynamics of corrosion stages and environmental conditions. In this paper, a 3D point-cloud data-based Bayesian model updating approach is presented to predict the critical parameter evolution of concrete sewer corrosion. The proposed approach adopts a novel distribution-based updating strategy to address the multivariate and asymmetric nature of massive point-cloud data. The effectiveness of the proposed method is investigated using two publicly available sewer corrosion datasets from Perth, Australia and Texas, USA. The Perth case results show that critical parameters after Bayesian updating have the same trends as the in situ monitoring data, which provides interpretability for ultimate decision-making. The Texas case results show that the proposed framework enables more accurate service life predictions than the non-updated Pomeroy model. The proposed approach achieves interpretable and intelligent decision-making, contributing to improved sewer predictive maintenance.

Abstract:To describe the probabilistic characteristics of critical chloride concentration (CCC) and calibrate the computational accuracy of traditional prediction models, a probabilistic prediction model of CCC for reinforcement corrosion in concrete has been developed based on an improved Gaussian process regression (GPR) model. Firstly, a new hybrid kernel function for the GPR model is proposed by combining the radial basis function (RBF) with the rational quartic kernel (RQK) according to the sum of single kernel functions and automatic relevance determination function. Then the hyperparameters of the improved GPR model are determined based on the Bayesian theory and the maximum likelihood estimation. Subsequently, a probabilistic prediction model of CCC for reinforcement corrosion in concrete is developed based on the improved GPR model and a total of 591 sets of experimental data. Finally, the accuracy and applicability of the proposed probabilistic prediction (PPP) model is validated by comparing with traditional kernel functions, machine learning models and empirical theoretical models. The results show that the PPP model based on the new hybrid kernel function has high accuracy and generalisation ability. The PPP model provides efficient way to describe the probabilistic characteristics of CCC for reinforcement corrosion in concrete and to calibrate the computational accuracy of traditional prediction models based on probability density function and confidence interval.

Abstract:A path probability model (PPM) for predicting the probability distribution of steel reinforcement subject to chloride ingress is presented in this paper to evaluate the corrosion level in a probability way. The whole corrosion history of given service period is divided into a series of paths formed by initiation phase and propagation phrase, which are respectively associated to the probability of corrosion initiation and the conditional probability of steel corrosion ratio when the corrosion has initiated. Based on PPM, a dynamic simulation has been performed to predict the time-dependent probability density function of corrosion ratio using Monte Carlo simulation technique. The efficiency of PPM is shown in some practical engineering cases. Sensitivity analysis of input parameters was also performed. The simulation results show that reinforcement corrosion ratio is related to the level of corrosion development and the quality of simulation results depends on the accuracy of statistical parameters from onsite experiments. PPM offers a new way to exhibit the evolution of reinforcement corrosion ratio during its service time.
Corrosion-crack path based probabilistic model to predict the durability behavior of RC components

Abstract:Taking account to the stochastic and time-dependent behaviors of existing concrete structures in service environment, an improved path probability model (PPM) is established to predict the process of corrosion, crack and load capability degradation of existing reinforced concrete structures with time. The time-dependent probability distribution of reinforcement corrosion ratio, crack width and load capability loss of RC concrete in carbonation, chloride penetration or coupling-effect environment can be simulated effectively by numerical calculation. Therefore it enable the computer simulation of the whole deterioration process of RC element from harmful mediums erosion, corrosion initiation of reinforcement, corrosion induced concrete crack and load capability reduction. Behavioral parameters involve percentage of corroded steel samples, steel corrosion ratio, area percentage of cracked concrete, and crack width and load capability reduction factor. These prediction results are proved reasonable and effective by statistics information from field data of existing concrete structure.

Abstract:The corrosion-induced failure of marine reinforced concrete structures, stemming from prolonged exposure to environments with elevated chloride content, poses a significant threat to structural integrity and serviceability. Traditional models predominantly depend on prior information to estimate the spatial stochastic degradation of aging structures, leading to a lack of comprehensiveness and accuracy in evaluation results. To address these limitations, a data-driven probabilistic assessment model for corrosion failure is proposed. This model incorporates a pre-training phase that integrates electrochemical simulations with long-term exposure data to establish the spatiotemporal distribution of corrosion failures, thereby facilitating a thorough assessment of overall damage by quantifying the corrosion failure proportion while propagating epistemic uncertainty. Subsequently, a multivariate function is derived using the non-dominated sorting genetic algorithm to elucidate the relationship between input and output variables. The efficacy of the data-driven model is evaluated through experimental observations and model predictions. The Hangzhou Bay Bridge project serves as a case study, wherein this model is demonstrated using actual data obtained from exposure experiments and field detection. Furthermore, the proposed model enables a rapid prejudgment of corrosion failure proportion, significantly reducing diagnostic time compared to conventional procedures.

Abstract:Accurate prediction of corrosion depth degradation law can provide a basis for the determination of the sacrificial layer thickness and the cover thickness of the concrete structural members in a corrosive environment. This study aims to explore a more accurate and safe method to predict corrosion depth. Six sets of concrete cylinder concrete specimens were adopted to perform an accelerated corrosion test in sulfuric acid solution with pH approximate to 0.95 for six different scheduled durations. 3D coordinates of a large number of points on the corroded cylindrical surface were obtained with the help of the 3D laser scanning technology. Then, a comparative study was carried out for the corrosion depth measured with the laser scanning method and vernier caliper method. The results prove that concrete corrosion depth predicted by the Gaussian random process model established by the laser scanning method was considered to possess higher credibility and better security.
Predicting Microbiologically Influenced Concrete Corrosion in Self-cleansing Sewers using Meta-learning Techniques

Abstract:ABSTRACT Sewer networks are not only necessary as an infrastructure for human societies, but they can also help humans achieve a stable situation with the surrounding natural environment by controlling and preventing the spread of pollution in the environment. As a result, concrete sewer maintenance and analysis of their damaging elements are critical. In this regard, modeling microbiologically influenced corrosion (MIC) is a challenging phenomenon. Due to the complicated aspects related to the interaction of microorganisms and concrete degradation, this research suggests several machine-learning models as well as traditional multiple linear regression (MLR) model to predict the MIC in sewer pipelines. The models can be categorized into three sections: (i) stand-alone models (GMDH, GRNN, RBFNN, MLPNN, CHAID, and CART), (ii) integrative models (ANFIS and SVR with PSO, ABC and FA) and (iii) ensemble meta-learner Stepwise Regression model. After implementing the models, statistical measures, including RMSE, MAE, MBE, PCC, and Nash–Sutcliffe model efficiency (NSE) are considered for evaluating models' performances. The results indicate that the ensemble Meta-learner-SR model is significantly more precise than other models. They also demonstrate that using an integrative model can improve the accuracy of stand-alone models by at least up to 42 percent. The durability and lifespan of the sewer system is also estimated by the aid of the best predictive model (Meta-learner-SR) for two scenario cases of (i) gas phase and (ii) submerged conditions. It is concluded that the sewer systems have a considerably lower life span (24 years less) exposed to submerged sewage than the gas phase with 56 years of durability.

Mathematical Modelling for the Concrete Corrosion of Sewer Systems

Abstract:Concrete corrosion in sewer systems is a complicated and dynamic process that involves wastewater, head gas, and concrete surfaces. The key process is the biological sulfide oxidation by corrosion microbial communities in the corrosion layer. Mathematical models are practically useful in designing new concrete sewer systems meeting the service life, or in planning the sewer rehabilitation and chemical dosing by estimating the corrosion rates. Theoretically, various corrosion models can also be employed to optimize the design of corrosion-resistant concrete or sewer operation. This chapter provides a review of models for the sulfide oxidation kinetics and different types of models for the service life, including corrosion initiation time and corrosion rate. As corrosion rate is the determining factor for concrete sewer service life, various models were discussed for its estimation, including empirical models, data-driven models, and process dynamic models. These mathematical modelling tools would enable better design, construction, operation, and management of sewer systems.

Abstract:<p>Pipeline plays an important role in the oil and gas transportation industry. In recent years, more and more pipeline damages and breakdowns are caused by corrosion, which hurts the normal operation. Accurate prediction of the pipeline's corrosion rate is of great significance for the pipeline to operate safely and soundly. In this study, a hybrid intelligent algorithm method is proposed to predict the corrosion rate of the multiphase flow pipeline. The proposed model combines support vector regression (SVR), principal component analysis (PCA), and chaos particle swarm optimization (CPSO), named PCA-CPSO-SVR. PCA can reduce the data dimension and screen out the main variables of corrosion influencing factors. CPSO is utilized to optimize the hyperfine parameters in SVR, thus improving the prediction accuracy of the prediction model. The mean absolute error of the proposed model is 0.083, which is 18.6% lower than that of SVR. Compared with five benchmark models including linear regression (LR), artificial neural network (ANN), PCA-genetic algorithm-SVR, PCA-PSO-SVR, and De warred95(OLGA), the proposed model has higher prediction accuracy. According to the above results, PCA-CPSO-SVR has a good performance in the prediction of the corrosion rate of the multiphase flow pipeline.</p>

Abstract:Chemical dosing is a commonly used strategy for mitigating sewer corrosion and odour problems caused by sulfide production. Prediction of sewage flow variation in real-time is critical for the optimization of chemical dosing to achieve cost-effective mitigation of hydrogen sulfide (H2S). Autoregressive (AR) models have previously been used for real-time sewage prediction. However, the prediction showed significant delays in wet weather conditions. In this paper, autoregressive with exogenous inputs (ARX) models are employed to reduce the delays with rainfall data used as model inputs. The model is applied to predicting sewage flows at two real-life sewage pumping stations (SPSs) with different hydraulic characteristics and climatic conditions. The calibrated models were capable of predicting flow rates in both cases, much more accurately than previously developed AR models under wet weather conditions. Simulation of on-line chemical dosing control based on the predicted flows showed excellent sulfide mitigation performance at reduced cost.
Gaussian Process Regression Based Inspection Robot for Predicting and Locating Pipeline Anticorrosion Coating Defects

Abstract:The Direct Current Voltage Gradient (DCVG) technology is adept at identifying defects and corrosion issues within the anti-corrosion layer of buried pipelines by measuring changes in voltage gradient above the ground. Its widespread adoption in the field of anti-corrosion layer defect detection for its high precision and accuracy. However, the current DCVG inspection process relies on experienced operators holding electrodes to walk along the pipeline, resulting in a huge workload. To address these challenges, this paper proposes an innovative method that combines Gaussian process regression (GPR) with an intelligent inspection robot for autonomous pipeline anti-corrosion coating defect detection. This method uses environmental data to directly predict the location of defects within a pipeline's anti-corrosion coating. Through incremental learning, the GPR model is trained to be continuously updated based on new samples such as position coordinates and voltage measurements during autonomous inspections. In addition, the intelligent inspection robot operates collaboratively with crawler wheels and UR robotic arms, enhancing motion stability and flexibility in expanding training data sets. Experimental results confirm that the intelligent inspection robot driven by Gaussian process prediction can achieve accurate defect positioning within 25 iteration cycles, with a positioning accuracy within 0.12m. This method enhances defect detection accuracy, alleviating operator burden and offering an efficient solution for buried pipeline maintenance.

Predicting Shear Strength of Corroded RC Columns: A Probabilistic Model with Enhanced Gaussian Process Regression

Abstract:This study proposes a new probabilistic model for predicting the shear strength of corroded reinforced concrete (RC) columns. The probabilistic model addresses limitations of traditional methods by combining mechanical understanding with enhanced Gaussian Process Regression (GPR). A novel mean function for enhanced GPR is developed first based on the shear resistance mechanism of corroded RC columns. Then the hyper-parameters of both the mean function and kernel function for the enhanced GPR are optimized using the maximum likelihood estimation method. This leads to the establishment of the probabilistic model that is based on the enhanced GPR. Finally, the accuracy and effectiveness of the enhanced GPR probabilistic model are validated by comparing it with both traditional mechanical models and machine learning models. The results indicate that the proposed probabilistic model can not only describes the probabilistic characteristics for shear strength of corroded RC columns based on probability density functions, but also provides an efficient calibration method for traditional prediction models based on confidence intervals.
Deep learning model based on urban multi-source data for predicting heavy metals (Cu, Zn, Ni, Cr) in industrial sewer networks

Abstract:The high concentrations of heavy metals in municipal industrial sewer networks will seriously impact the microorganisms of the activated sludge in the wastewater treatment plant (WWTP), thus deteriorating the effluent quality and destroying the stability of sewage treatment. Therefore, timely prediction and early warning of heavy metal concentrations in industrial sewer networks is crucial. However, due to the complex sources of heavy metals in industrial sewer networks, traditional physical modeling and linear methods cannot establish an accurate prediction model. Herein, we developed a Gated Recurrent Unit (GRU) neural network model based on a deep learning algorithm for predicting the concentrations of heavy metals in industrial sewer networks. To train the GRU model, we used low-cost and easy-to-obtain urban multi-source data, including socio-environmental indicator data, air environmental indicator data, water quantity indicator data, and easily measurable water quality indicator data. The model was applied to predict the concentrations of heavy metals (Cu, Zn, Ni, and Cr) in the sewer networks of an industrial area in southern China. The results are compared with the commonly used Artificial Neural Network (ANN) model. In this study, it was shown that the GRU had better prediction performance for Cu, Zn, Ni, and Cr concentrations, with the average R2 significantly increased by 12.35%, 11.94%, 9.21%, and 8.13%, respectively, compared to ANN predictions. The sensitivity analysis based on Shapley (SHAP) values revealed that conductivity (σ), temperature (T), pH, and sewage flow (Flow) contributed significantly to the prediction results of the model. Furthermore, the three input variables including air pressure (AP), land area (A), and population (Pop.) were removed without affecting the prediction performance of the model, which maximized the modeling efficiency and reduced the operational cost. This study provides an economical and feasible technical method for early warning of abnormal heavy metal concentrations in urban industrial sewer networks.
A probabilistic computational framework for the prediction of corrosion-induced cracking in large structures

Abstract:Corrosion can initiate cracking that leads to structural integrity reduction. Quantitative corrosion assessment is challenging, and the modeling of corrosion-induced crack initiation is essential for model-based corrosion reliability analysis of various structures. This paper proposes a probabilistic computational analysis framework for corrosion-to-crack transitions by integrating a phase-field model with machine learning and uncertainty quantification. An electro-chemo-mechanical phase-field model is modified to predict pitting corrosion evolution, in which stress is properly coupled into the electrode chemical potential. A crack initiation criterion based on morphology is proposed to quantify the pit-to-cracking transition. A spatiotemporal surrogate modeling method is developed to facilitate this, consisting of a Convolution Neural Network (CNN) to map corrosion morphology to latent spaces, and a Gaussian Process regression model with a nonlinear autoregressive exogenous model (NARX) architecture for prediction of corrosion dynamics in the latent space over time. It enables the real-time prediction of corrosion morphology and crack initiation behaviors (whether, when, and where the corrosion damage triggers the crack initiation), and thus makes it possible for probabilistic analysis, with uncertainty quantified. Examples at various stress and corrosion conditions are presented to demonstrate the proposed computational framework.

Abstract:The aim of this study was to predict the corrosion of cement concrete (CC) and sulfur concrete (SC) in sewer systems using three artificial intelligence (AI)-based techniques: Adaptive NeuroFuzzy Inference System (ANFIS), Genetic Programming (GP), and Multi Expression Programming (MEP). Two sets of chemical experiments in acidic solutions and biological tests using Thiobacillus thiooxidans were conducted to investigate the corrosion in concrete samples. For both tests, weight loss was used as the indicator of corrosion. Time and pH values in chemical tests were selected as the input variables, while in biological experiments only time was selected as the input variable. In addition, compressive strength (CS), weight loss, water absorption, and hole index ratio (HIR) were selected as the output variables for both experiments. Based on the results obtained in both experiments, a database of 256 values was established to train and test the prediction models. According to the results, all AI-based models were able to predict the weight loss with reasonable accuracy. In contrast, the proposed MEP model outperformed other models with R2 of 92.1 (training) and 87.9 (testing) for CC and 99.5 (training) and 97.7 (testing) for SC, respectively. This study shows that machine learning-based models can help engineers estimate the corrosion of concrete pipes in sewer systems.Highlights• ANFIS, GP and MEP models were used to model corrosion in cement and sulfur concrete• All AI-based methods were able to predict corrosion in both types of concrete• MEP showed better performance than other methods in the prediction of corrosion

Abstract:Biogenic sulphide corrosion of reinforced concrete sewer pipes is an ongoing problem for wastewater governing bodies. Ensuring Workplace Health and Safety (WHS) is also an issue due to the harsh nature of sewer environments. As such, research into technologies that allow for automatic unmanned site assessments are of major priority to wastewater managing utilities. The use of Ground Penetrating Radar (GPR) is currently being investigated for it's ability to provide subsurface images. However, the GPR technology has not been tested and validated in harsh sewer environments. It is anticipated that the GPR interpretation can be hindered by low signal to noise ratio. As data driven machine learning techniques have proven to work in higly challenging data, our intenetion is to apply such techniques in GPR data processing. However, this is hindered by the lack of large amount of training data as it is prohibitively hard to collect such real experimental testing data. Thus, the aim of this study is to validate a ground penetrating radar simulation software, gprMax, and test it for suitability in generating realistic, big data sets with which to train the aforementioned data driven machine learning models supplemented with actual sewer crown data. The results of the study is the validation of the GPR simulator, tuned and able to generate reasonably realistic data. A novel concrete analog was also developed to allow for ease of testing of various parameters such as rebar cover depths and rebar spacing.

Abstract:The concrete composition of different pipelines varies greatly, and a comprehensive analysis of the impact of concrete design on pipeline corrosion is required. Developed an integrated model based on Scikit-Optimize, XGBoost and SHAP to analyze concrete's carbonation and sulfuric acid resistance from five aspects: binder type, supplementary cementitious material (SCM's), aggregate, admixture and w/b. Choose Scikit-Optimize for parameter optimization. As an explanation model, the SHAP model can perform analysis well and explain the analysis basis of the XGBoost training model. The established model can accurately predict the corrosion effect (R 2 >0.987) without overfitting. Binder should be maintained at 380 to 400 (kg/m 3 ). Water/binder and coarse aggregate/binder are the two main factors that influence the binder, and they should be maintained at a ratio of around 0.4 to 0.6 and 2.5, respectively. Fly ash (FA) should be SCM's used as at a range of 300 to 350 (kg/m 3 ) to improve corrosion resistance.
