Abstract:Bio-inspired computing promises fundamentally different ways to advances in artificial intelligence with extreme energy efficiency. Memristive technologies due to the non-volatility, high density, low-power, and synaptic bionic properties can help in realizing bio-inspired architecture and its hardware implementation. This paper proposes a novel physics-oriented memristor model with coexistence of negative differential resistance (NDR) effect and resistive switching (RS) memory behavior for bio-inspired computing. Firstly, an Ag/TiOx/FTO memristor is fabricated using sol-gel and magnetron sputtering method, and its performance test demonstrates that the coexistence of NDR effect and RS memory behavior can be modulated by the moisture. Then, a physical-oriented memristor model is constructed, which provides the possibility to explore the dynamics of the coexistence of NDR effect and RS memory behavior in simulation. Furthermore, a memristor-based affective computing circuit emulating the process of human affective associative learning is designed. The experiment demonstrates that the coexistence of NDR effect and RS memory behavior can change the memory time without additional circuit and cost, which is expected to realize the automatic conversion from short-term memory to long-term memory in bio-inspired computing.

Abstract:Analog computing using non-volatile memristors has emerged as a promising solution for energy-efficient deep learning. New materials, like perovskites-based memristors are recently attractive due to their cost-effectiveness, energy efficiency and flexibility. Yet, challenges in material diversity and immature fabrications require extensive experimentation for device development. Moreover, significant non-idealities in these memristors often impede them for computing. Here, we propose a synergistic methodology to concurrently optimize perovskite memristor fabrication and develop robust analog DNNs that effectively address the inherent non-idealities of these memristors. Employing Bayesian optimization (BO) with a focus on usability, we efficiently identify optimal materials and fabrication conditions for perovskite memristors. Meanwhile, we developed "BayesMulti", a DNN training strategy utilizing BO-guided noise injection to improve the resistance of analog DNNs to memristor imperfections. Our approach theoretically ensures that within a certain range of parameter perturbations due to memristor non-idealities, the prediction outcomes remain consistent. Our integrated approach enables use of analog computing in much deeper and wider networks, which significantly outperforms existing methods in diverse tasks like image classification, autonomous driving, species identification, and large vision-language models, achieving up to 100-fold improvements. We further validate our methodology on a 10$\times$10 optimized perovskite memristor crossbar, demonstrating high accuracy in a classification task and low energy consumption. This study offers a versatile solution for efficient optimization of various analog computing systems, encompassing both devices and algorithms.

Abstract:In this work, a novel hybrid computing architecture with rnristor-based processing-in-memo (MPiM) proposed to resolve the memory-wall issue fo data-intensive applications. The datapath and control logic are redesigned to incorporate MPiM. Thus, some data can be processed in the memory array or the specific logic near the memory array. So the data to be transfered over the bus can be reduced considerably, saving power as well as improving the performance. Evaluations on data-intensive applications show reductions of 80% in energy consumption and 75% reduction in processing latency.

Abstract:Neuromorphic computing is a potential candidate to break the von Neumann bottleneck, in which the trade-off between computational precision and energy consumption remains challenging. In this brief, a complementary memristor cell based on monolayer AlOx film is proposed, whose two components exhibit analog (N-Si/AlOx/TiN) and digital (N-Si/AlOx/Cu) resistive switching behaviors. Typical synapse behaviors including spike time-dependent plasticity (STDP) and long-term potentiation/depression (LTP/LTD) are emulated in different working modes. Moreover, with the high/low resistive state (HRS/LRS) in the digital component, the cell shows low/high accuracies with different power consumption, which are ~82% and ~94% in the Modified National Institute of Standards and Technology (MNIST) recognition task. Our findings may provide the potential to develop energy-efficient, feasible integrating, and mixed-precision neuromorphic computing based on AlOx monolayer memristors.

Abstract:Using memristor crossbar arrays to accelerate computations is a promising approach to efficiently implement algorithms in deep neural networks. Early demonstrations, however, are limited to simulations or small-scale problems primarily due to materials and device challenges that limit the size of the memristor crossbar arrays that can be reliably programmed to stable and analog values, which is the focus of the current work. High-precision analog tuning and control of memristor cells across a 128 × 64 array is demonstrated, and the resulting vector matrix multiplication (VMM) computing precision is evaluated. Single-layer neural network inference is performed in these arrays, and the performance compared to a digital approach is assessed. Memristor computing system used here reaches a VMM accuracy equivalent of 6 bits, and an 89.9% recognition accuracy is achieved for the 10k MNIST handwritten digit test set. Forecasts show that with integrated (on chip) and scaled memristors, a computational efficiency greater than 100 trillion operations per second per Watt is possible.

Abstract:Reinforcement learning algorithms that use deep neural networks are a promising approach for the development of machines that can acquire knowledge and solve problems without human input or supervision. At present, however, these algorithms are implemented in software running on relatively standard complementary metal–oxide–semiconductor digital platforms, where performance will be constrained by the limits of Moore’s law and von Neumann architecture. Here, we report an experimental demonstration of reinforcement learning on a three-layer 1-transistor 1-memristor (1T1R) network using a modified learning algorithm tailored for our hybrid analogue–digital platform. To illustrate the capabilities of our approach in robust in situ training without the need for a model, we performed two classic control problems: the cart–pole and mountain car simulations. We also show that, compared with conventional digital systems in real-world reinforcement learning tasks, our hybrid analogue–digital computing system has the potential to achieve a significant boost in speed and energy efficiency.

Abstract:Robots are widely used, providing significant convenience in daily life and production. With the rapid development of artificial intelligence and neuromorphic computing in recent years, the realization of more intelligent robots through a profound intersection of neuroscience and robotics has received much attention. Neuromorphic circuits based on memristors used to construct hardware neural networks have proved to be a promising solution of shattering traditional control limitations in the field of robot control, showcasing characteristics that enhance robot intelligence, speed, and energy efficiency. Starting with introducing the working mechanism of memristors and peripheral circuit design, this review gives a comprehensive analysis on the biomimetic information processing and biomimetic driving operations achieved through the utilization of neuromorphic circuits in brain-like control. Four hardware neural network approaches, including digital-analog hybrid circuit design, novel device structure design, multi-regulation mechanism, and crossbar array, are summarized, which can well simulate the motor decision-making mechanism, multi-information integration and parallel control of brain at the hardware level. It will be definitely conductive to promote the application of memristor-based neuromorphic circuits in areas such as intelligent robotics, artificial intelligence, and neural computing. Finally, a conclusion and future prospects are discussed.

Abstract:The increasing interests in analog computing nowadays call for multipurpose analog computing platforms with reconfigurability. The advancement of analog computing, enabled by novel electronic elements like memristors, has shown its potential to sustain the exponential growth of computing demand in the new era of analog data deluge. Here, a platform of a memristive field-programmable analog array (memFPAA) is experimentally demonstrated with memristive devices serving as a variety of core analog elements and CMOS components as peripheral circuits. The memFPAA is reconfigured to implement a first-order band pass filter, an audio equalizer, and an acoustic mixed frequency classifier, as application examples. The memFPAA, featured with programmable analog memristors, memristive routing networks, and memristive vector-matrix multipliers, opens opportunities for fast prototyping analog designs as well as efficient analog applications in signal processing and neuromorphic computing.

Abstract:Memristor with tunable non-volatile resistance offers in-memory computing capability that avoids the von-Neumann bottleneck. However, large-scale experimental demonstration to this end is yet to be implemented due to the immaturity of the device and integration technologies. Here in this paper we report our recent process in analog computing using analog-voltage-amplitude-vector input and analog-memristor-conductance matrix, with applications in signal and image processing. The vector matrix multiplication is processed in the memristor crossbars in one step, with 5-8 bit precision depending on the array size. The demonstration is made possible by high memristor yield (99.8%), stable multilevel memresistance states, linear current-voltage (IV) relation in the operation range, and low wire resistance between the cells.

Abstract:In-memory computing represents an effective method for modeling complex physical systems that are typically challenging for conventional computing architectures but has been hindered by issues such as reading noise and writing variability that restrict scalability, accuracy, and precision in high-performance computations. We propose and demonstrate a circuit architecture and programming protocol that converts the analog computing result to digital at the last step and enables low-precision analog devices to perform high-precision computing. We use a weighted sum of multiple devices to represent one number, in which subsequently programmed devices are used to compensate for preceding programming errors. With a memristor system-on-chip, we experimentally demonstrate high-precision solutions for multiple scientific computing tasks while maintaining a substantial power efficiency advantage over conventional digital approaches.

Abstract:We present an integrated circuit fabricated in a process co-integrating CMOS and hafnium-oxide memristor technology, which provides a prototyping platform for projects involving memristors. Our circuit includes the periphery circuitry for using memristors within digital circuits, as well as an analog mode with direct access to memristors. The platform allows optimizing the conditions for reading and writing memristors, as well as developing and testing innovative memristor-based neuromorphic concepts.

Abstract:Since the connection of the theoretical memristor concept with physical resistive switching devices in 2008, tremendous progress has been made in terms of material and device technology developments and their applications in memory and computing systems. The physical embodiments of memristors correspond to various resistive switching devices based on different mechanisms. These mechanisms endow the memristors with rich nonlinear dynamics, which is key to constructing biologically plausible dynamic computing systems. Memristor can be described as a set of differential equations that indicate how the internal state variables determine device characteristics and how external electrical stimulations influence these state variables. The increases in the number of state variables and internal dynamics have dramatically enriched the dynamics and functionality of memristors. Further exploration and control of such dynamics are essential for highly efficient information processing applications.

Abstract:Advances in electronics have revolutionized the way people work, play and communicate with each other. Historically, these advances were mainly driven by CMOS transistor scaling following Moore’s law, where new generations of devices are smaller, faster, and cheaper, leading to more powerful circuits and systems. However, conventional scaling is now facing major technical challenges and fundamental limits. New materials, devices, and architectures are being aggressively pursued to meet present and future computing needs, where tight integration of memory and logic, and parallel processing are highly desired. To this end, one class of emerging devices, termed memristors or memristive devices, have attracted broad interest as a promising candidate for future memory and computing applications. Besides tremendous appeal in data storage applications, memristors offer the potential to enable efficient hardware realization of neuromorphic and analog computing architectures that differ radically from conventional von Neumann computing architectures. In this review, we analyze representative memristor devices and their applications including mixed signal analog-digital neuromorphic computing architectures, and highlight the potential and challenges of applying such devices and architectures in different computing applications.

Abstract:Abstract Implementing power-efficient reservoir computing hardware systems is of great interest to the field of neuromorphic computing. More and more studies attempt to use analog devices or components, such as memristors and spintronic oscillators, to partially replace fully digital systems to boost the power efficiency. However, a reservoir computing system operating real-time in fully analog fashion has not been demonstrated yet. In this work, a fully analog reservoir computing system was implemented using two types of memristors, where dynamic memristors were used to construct the reservoir while non-volatile memristor arrays were used as the readout layer. The key features, such as threshold and window, extracted from the dynamic memristor-based physical nodes were found to have a significant impact on the system performance. By adjusting the features to the appropriate range, our system can efficiently process spatiotemporal signals in real time with extremely low power consumption, more than three orders of magnitudes lower than digital counterparts. Both temporal task of arrhythm detection and spatiotemporal task of dynamic gesture recognition were demonstrated, where high detection accuracy of 96.6% and recognition accuracy 97.9% were achieved respectively. Our work demonstrates that such memristor-based fully analog reservoir computing system could be attractive for spatial and temporal edge computing with extremely low power and hardware cost.

Abstract:As technology advances, artificial intelligence becomes pervasive in society and ubiquitous in our lives, which stimulates the desire for embedded-everywhere and human-centric intelligent computation paradigm. However, conventional instruction-based computer architecture was designed for algorithmic and exact calculations. It is not suitable for handling the applications of machine learning and neural networks that usually involve a large sets of noisy and incomplete natural data. Instead, neuromorphic systems inspired by the working mechanism of human brains create promising potential. Neuromorphic systems possess a massively parallel architecture with closely coupled memory and computing. Moreover, through the sparse utilizations of hardware resources in time and space, extremely high power efficiency can be achieved. In recent years, the use of memristor technology in neuromorphic systems has attracted growing attention for its distinctive properties, such as nonvolatility, reconfigurability, and analog processing capability. In this paper, we summarize the research efforts in the development of memristor crossbar based neuromorphic design from the perspectives of device modeling, circuit, architecture, and design automation.

Abstract:As an emerging electronic device, a memristor facilitates the realization of neuromorphic computing systems. However, high-performance neuromorphic computing systems require not only robust analog memristors but also digital memristors with complementary functions. Here, a digital–analog integrated memristor based on Al/ZnO NPs/CuO NWs/Cu is proposed and demonstrated. First, the electrical properties of the CuO NWs based device are investigated, which exhibit a write-once-read-many-times (WORM) performance. Then, typical bipolar resistive switching behaviors are realized by spin-coating the ZnO NPs to form an Al/ZnO NPs/CuO NWs/Cu based memristor. Through tuning of the applied voltage, an abrupt-to-gradient transition of conductance is achieved in situ. Several analog behaviors, such as long-term potentiation/depression (LTP/LTD), and paired-pulse facilitation/depression (PPF/PPD) are effectively emulated by applying a series of specified electrical measurements to the memristor, which proves the achievement of a digital–analog integrated memristor. Furthermore, on the basis of the LTD and LTP behaviors of the memristor, neural network simulations for handwritten recognition are implemented. The results reveal high recognition accuracies of up to 93%, which are close to the performances for ideal memristors.

Abstract:Memristors with tunable non-volatile resistance states offer the potential for in-memory computing that mitigates the von-Neumann bottleneck. We build a large scale memristor array by integrating a transistor array with Ta/HfO2 memristors that have stable multilevel resistance states and linear IV characteristic. With off-chip peripheral driving circuits, the memristor chip is capable of high-precision analog computing and online learning. We demonstrate a weight-update scheme that provides linear and symmetric potentiation and depression with no more than two pulses for each cell. We train the array as a single-layer fully-connected feedforward neural network for the WDBC data base and achieve 98% classification accuracy. We further partition the array into a two-layer network, which achieves 91.71% classification accuracy for MNIST database experimentally. The system demonstrates high defect tolerance and excellent speed-energy efficiency.

Abstract:Algorithms for intelligent drone flights based on sensor fusion are usually implemented using conventional digital computing platforms. However, alternative energy-efficient computing platforms are required for robust flight control in a variety of environments to reduce the burden on both the battery and computing power. In this study, we demonstrated an analog-digital hybrid computing platform based on SnS2 memtransistors for low-power sensor fusion in drones. The analog Kalman filter circuit with memtransistors facilitates noise removal to accurately estimate the rotation of the drone by combining sensing data from the gyroscope and accelerometer. We experimentally verified that the power consumption of our hybrid computing-based Kalman filter is only 1/4th of that of the traditional software-based Kalman filter.

Abstract:Memristor crossbars offer reconfigurable non-volatile resistance states and could remove the speed and energy efficiency bottleneck in vector-matrix multiplication, a core computing task in signal and image processing. Using such systems to multiply an analogue-voltage-amplitude-vector by an analogue-conductance-matrix at a reasonably large scale has, however, proved challenging due to difficulties in device engineering and array integration. Here we show that reconfigurable memristor crossbars composed of hafnium oxide memristors on top of metal-oxide-semiconductor transistors are capable of analogue vector-matrix multiplication with array sizes of up to 128 × 64 cells. Our output precision (5–8 bits, depending on the array size) is the result of high device yield (99.8%) and the multilevel, stable states of the memristors, while the linear device current–voltage characteristics and low wire resistance between cells leads to high accuracy. With the large memristor crossbars, we demonstrate signal processing, image compression and convolutional filtering, which are expected to be important applications in the development of the Internet of Things (IoT) and edge computing.
