Abstract:Purpose The complexity of convolutional neural networks (CNNs) can lead to improved segmentation accuracy in medical image analysis but also results in increased network complexity and training challenges, especially under resource limitations. Conversely, lightweight models offer efficiency but often sacrifice accuracy. This paper addresses the challenge of balancing efficiency and accuracy by proposing LightAWNet, a lightweight adaptive weighting neural network for medical image segmentation. Methods We designed LightAWNet with an efficient inverted bottleneck encoder block optimized by spatial attention. A two‐branch strategy is employed to separately extract detailed and spatial features for fusion, enhancing the reusability of model feature maps. Additionally, a lightweight optimized up‐sampling operation replaces traditional transposed convolution, and channel attention is utilized in the decoder to produce more accurate outputs efficiently. Results Experimental results on the LiTS2017, MM‐WHS, ISIC2018, and Kvasir‐SEG datasets demonstrate that LightAWNet achieves state‐of‐the‐art performance with only 2.83 million parameters. Our model significantly outperforms existing methods in terms of segmentation accuracy, highlighting its effectiveness in maintaining high performance with reduced complexity. Conclusions LightAWNet successfully balances efficiency and accuracy in medical image segmentation. The innovative use of spatial attention, dual‐branch feature extraction, and optimized up‐sampling operations contribute to its superior performance. These findings offer valuable insights for the development of resource‐efficient yet highly accurate segmentation models in medical imaging. Abstract:In the field of computer-aided medical diagnosis, it is crucial to adapt medical image segmentation to limited computing resources. There is tremendous value in developing accurate, real-time vision processing models that require minimal computational resources. When building lightweight models, there is always a trade-off between computational cost and segmentation performance. Performance often suffers when applying models to meet resource-constrained scenarios characterized by computation, memory, or storage constraints. This remains an ongoing challenge. This paper proposes a lightweight network for medical image segmentation. It introduces a lightweight transformer, proposes a simplified core feature extraction network to capture more semantic information, and builds a multi-scale feature interaction guidance framework. The fusion module embedded in this framework is designed to address spatial and channel complexities. Through the multi-scale feature interaction guidance framework and fusion module, the proposed network achieves robust semantic information extraction from low-resolution feature maps and rich spatial information retrieval from high-resolution feature maps while ensuring segmentation performance. This significantly reduces the parameter requirements for maintaining deep features within the network, resulting in faster inference and reduced floating-point operations (FLOPs) and parameter counts. Experimental results on ISIC2017 and ISIC2018 datasets confirm the effectiveness of the proposed network in medical image segmentation tasks. For instance, on the ISIC2017 dataset, the proposed network achieved a segmentation accuracy of 82.33 % mIoU, and a speed of 71.26 FPS on 256 × 256 images using a GeForce GTX 3090 GPU. Furthermore, the proposed network is tremendously lightweight, containing only 0.524M parameters. Abstract:Accurate segmentation of computerized tomography (CT) images is of great significance to clinical diagnosis. However, because of the high similarity of gray values, it is a challenging task for CT image segmentation. The encoder and decoder based CNN architecture has greatly improved the segmentation effect, but it also encounters a bottleneck due to the information loss in the encoding process. In view of this, we proposed an image segmentation model based on a novel network architecture for medical image segmentation. To improve the efficiency and decrease the number of model parameters, we optimized the Inception module by substituting the depth-wise separable convolutions (DWSC) for the standard convolutions. Then, the optimized Inception module paired with the residual network was chosen as the backbone extractor to extract high-quality image features. Further, a hybrid attention mechanism, which consists of channel-wise and spatial attention, was incorporated into the network to realize the maximum reuse of inter-channel relationships and spatial point characteristics. In particular, the attention module was separately embedded into the contracting and expansive paths to enhance the feature extraction capability and detail restoration effects. The experimental indicators were significantly improved on the test dataset, and the intersection over union (IoU) of the proposed method reached no less than 0.9645, 0.6499, and 0.7945 on the Lung, Colon tumor, and DRIVE datasets, respectively, which demonstrated the effectiveness of the proposed method. Abstract:Accurate segmentation of lesions in medical images is of great significance for clinical diagnosis and evaluation. The low contrast between lesions and surrounding tissues increases the difficulty of automatic segmentation, while the efficiency of manual segmentation is low. In order to increase the generalization performance of segmentation model, we proposed a deep learning-based automatic segmentation model called CM-SegNet for segmenting medical images of different modalities. It was designed according to the multiscale input and encoding-decoding thoughts, and composed of multilayer perceptron and convolution modules. This model achieved communication of different channels and different spatial locations of each patch, and considers the edge related feature information between adjacent patches. Thus, it could fully extract global and local image information for the segmentation task. Meanwhile, this model met the effective segmentation of different structural lesion regions in different slices of three-dimensional medical images. In this experiment, the proposed CM-SegNet was trained, validated, and tested using six medical image datasets of different modalities and 5-fold cross validation method. The results showed that the CM-SegNet model had better segmentation performance and shorter training time for different medical images than the previous methods, suggesting it is faster and more accurate in automatic segmentation and has great potential application in clinic.
Relationship of insulin binding to amino acid transport by cultured 14-day embryonic chick heart cells.

Abstract:The characteristics of insulin receptors were studied in cultured embryonic chick heart cells which demonstrated insulin-responsive amino acid transport. Binding of [125I]iodoinsulin was time dependent, reversible, saturable, species specific, and proportional to cell number. Optimum binding occurred at pH 7.8 in the presence of 0.1% bovine serum albumin. Curvilinear Scatchard plots were found for chicken and bovine insulin binding at 15 and 30 C. Equilibrium association constants (Kas) and maximum capacities were calculated based on a two-receptor model. When studied at 15 C, chicken insulin was bound with Kas of 5.0 and 0.026 nM-1 for the high and low affinity receptors, respectively. Bovine insulin bound with Kas of 2.1 and 0.03 nM-1. The binding capacities of 600 and 9000 molecules/cell for the high and low affinity receptors, respectively, were the same for both species of ligand. At 30 C, the Ka of the high affinity chicken insulin receptor interaction decreased to 1.6 nM-1, whereas the low affinity Ka was not changed. In competitive binding assays, chicken insulin was 4 and 250 times more potent than bovine and guinea pig insulin, respectively. Human GH and mouse epidermal growth factor did not compete with chicken insulin. Although mouse epidermal growth factor did not compete with insulin, it did stimulate 2-aminoisobutyric acid accumulation. The maximal stimulation by this hormone was less than and additive to that produced by the maximal stimulation of insulin. These data indicate that insulin and epidermal growth factor acted through different receptors to stimulate amino acid transport. When insulin-stimulated functional response was compared to calculated receptor occupancy in this two-receptor model, stimulation of amino acid transport paralleled occupancy of the low affinity receptor such that at half-maximal transport stimulation, approximately 50% of these receptors were occupied. Half-maximal stimulation of 2-aminoisobutyric acid transport occurred at 18- and 20-nM concentrations of bovine and chicken insulins, respectively. Guinea pig insulin failed to stimulate 2-aminoisobutyric acid uptake even at 350 nM. Both the affinity of binding in the low affinity class and the insulin concentration for half-maximal stimulation of 2-aminoisobutyric acid transport were independent of temperature in the temperature ranges studied. We conclude that 14-day embryonic chick heart cells possess at least two classes of receptors which bind insulin. Occupancy of the lower affinity class of insulin receptors correlates quantitatively with insulin stimulation of 2-aminoisobutyric acid transport.
CFPNet-M: A Light-Weight Encoder-Decoder Based Network for Multimodal Biomedical Image Real-Time Segmentation

Abstract:Currently, developments of deep learning techniques are providing instrumental to identify, classify, and quantify patterns in medical images. Segmentation is one of the important applications in medical image analysis. In this regard, U-Net is the predominant approach to medical image segmentation tasks. However, we found that those U-Net based models have limitations in several aspects, for example, millions of parameters in the U-Net consuming considerable computation resource and memory, lack of global information, and missing some tough objects. Therefore, we applied two modifications to improve the U-Net model: 1) designed and added the dilated channel-wise CNN module, 2) simplified the U shape network. Based on these two modifications, we proposed a novel light-weight architecture -- Channel-wise Feature Pyramid Network for Medicine (CFPNet-M). To evaluate our method, we selected five datasets with different modalities: thermography, electron microscopy, endoscopy, dermoscopy, and digital retinal images. And we compared its performance with several models having different parameter scales. This paper also involves our previous studies of DC-UNet and some commonly used light-weight neural networks. We applied the Tanimoto similarity instead of the Jaccard index for gray-level image measurements. By comparison, CFPNet-M achieves comparable segmentation results on all five medical datasets with only 0.65 million parameters, which is about 2% of U-Net, and 8.8 MB memory. Meanwhile, the inference speed can reach 80 FPS on a single RTX 2070Ti GPU with the 256 by 192 pixels input size.

Abstract:Objective. Convolutional Neural Networks(CNN) have been widely adopted for medical image segmentation with their outstanding feature representation capabilities. As the segmentation accuracy gets constantly updated, the complexity of networks increases as well. Complex networks can achieve better performance but require more parameters and are hard to train with limited resources, while lightweight models are faster but cannot fully utilize the contextual information of medical images. In this paper, we focus on better balancing the efficiency and accuracy. Approach. We propose a correlation-enhanced lightweight network (CeLNet) for medical image segmentation, which adopts a siamese structure for weight sharing and parameter saving. Through the feature reuse and feature stacking of parallel branches, a point-depth convolution parallel block (PDP Block) is proposed to reduce the model parameters and computational cost while improving the feature extraction capability of encoder. A relation module is also designed to extract feature correlations of input slices, which utilizes global and local attention to enhance feature connections, while reducing feature differences through element subtraction, and finally obtains contextual information of associated slices to improve the segmentation performance. Main results. We conduct extensive experiments on the LiTS2017, MM-WHS and ISIC2018 datasets, and the proposed model consumes merely 5.18M parameters but achieves excellent segmentation performance, specifically, a DSC of 0.9233 in LiTS2017 dataset, an average DSC of 0.7895 on MM-WHS dataset and an average DSC of 0.8401 on ISIC2018 dataset. Significance. CeLNet achieves state-of-the-art performance in multiple datasets while ensuring lightweight.

Abstract:In order to achieve highly precise medical image segmentation, this paper presents ConvMedSegNet, a novel convolutional neural network designed with a U-shaped architecture that seamlessly integrates two crucial modules: the multi-receptive field depthwise convolution module (MRDC) and the guided fusion module (GF). The MRDC module's primary function is to capture texture information of varying sizes through multi-scale convolutional layers. This information is subsequently utilized to enhance the correlation of global feature data by expanding the network's width. This strategy adeptly preserves the inherent inductive biases of convolution while concurrently amplifying the network's ability to establish dependencies on global information. Conversely, the GF module assumes responsibility for implementing multi-scale feature fusion by connecting the encoder and decoder components. It facilitates the transfer of information between features that are separated over substantial distances through guided fusion, effectively minimizing the loss of critical data. In experiments conducted on public medical image datasets such as BUSI and ISIC2018, ConvMedSegNet outperforms several advanced competing methods, yielding superior results. Abstract:Medical image segmentation and classification are two of the most key steps in computer-aided clinical diagnosis. The region of interest were usually segmented in a proper manner to extract useful features for further disease classification. However, these methods are computationally complex and time-consuming. In this paper, we proposed a one-stage multi-task attention network (MTANet) which efficiently classifies objects in an image while generating a high-quality segmentation mask for each medical object. A reverse addition attention module was designed in the segmentation task to fusion areas in global map and boundary cues in high-resolution features, and an attention bottleneck module was used in the classification task for image feature and clinical feature fusion. We evaluated the performance of MTANet with CNN-based and transformer-based architectures across three imaging modalities for different tasks: CVC-ClinicDB dataset for polyp segmentation, ISIC-2018 dataset for skin lesion segmentation, and our private ultrasound dataset for liver tumor segmentation and classification. Our proposed model outperformed state-of-the-art models on all three datasets and was superior to all 25 radiologists for liver tumor diagnosis.

MambaClinix: Hierarchical Gated Convolution and Mamba-Based U-Net for Enhanced 3D Medical Image Segmentation

Abstract:Deep learning, particularly convolutional neural networks (CNNs) and Transformers, has significantly advanced 3D medical image segmentation. While CNNs are highly effective at capturing local features, their limited receptive fields may hinder performance in complex clinical scenarios. In contrast, Transformers excel at modeling long-range dependencies but are computationally intensive, making them expensive to train and deploy. Recently, the Mamba architecture, based on the State Space Model (SSM), has been proposed to efficiently model long-range dependencies while maintaining linear computational complexity. However, its application in medical image segmentation reveals shortcomings, particularly in capturing critical local features essential for accurate delineation of clinical regions. In this study, we propose MambaClinix, a novel U-shaped architecture for medical image segmentation that integrates a hierarchical gated convolutional network(HGCN) with Mamba in an adaptive stage-wise framework. This design significantly enhances computational efficiency and high-order spatial interactions, enabling the model to effectively capture both proximal and distal relationships in medical images. Specifically, our HGCN is designed to mimic the attention mechanism of Transformers by a purely convolutional structure, facilitating high-order spatial interactions in feature maps while avoiding the computational complexity typically associated with Transformer-based methods. Additionally, we introduce a region-specific Tversky loss, which emphasizes specific pixel regions to improve auto-segmentation performance, thereby optimizing the model's decision-making process. Experimental results on five benchmark datasets demonstrate that the proposed MambaClinix achieves high segmentation accuracy while maintaining low model complexity.

Abstract:In recent years, UNet and its derivative networks have gained widespread recognition as major methods of medical image segmentation. However, networks like UNet often struggle with Point-of-Care (POC) healthcare applications due to their high number of parameters and computational complexity. To tackle these challenges, this paper introduces an efficient network designed for medical image segmentation called MCU-Net, which leverages ConvNeXt to enhance UNet. 1) Based on ConvNeXt, MCU-Net proposes the MCU Block, which employs techniques such as large kernel convolution, depth-wise separable convolution, and an inverted bottleneck design. To ensure stable segmentation performance, it also integrates global response normalization (GRN) layers and Gaussian Error Linear Unit (GELU) activation functions. 2) Additionally, MCU-Net introduces an enhanced Multi-Scale Convolution Attention (MSCA) module after the original UNet's skip connections, emphasizing medical image features and capturing semantic insights across multiple scales. 3)The downsampling process replaces pooling layers with convolutions, and both upsampling and downsampling stages incorporate batch normalization (BN) layers to enhance model stability during training. The experimental results demonstrate that MCU-Net, with a parameter count of 2.19 million and computational complexity of 19.73 FLOPs, outperforms other segmentation models. The overall performance of MCU-Net in medical image segmentation surpasses that of other models, achieving a Dice score of 91.8% and mIoU of 84.7% on the GlaS dataset. When compared to UNet on the BUSI dataset, MCU-Net shows an improvement of 2% in Dice and 2.9% in mIoU.

Abstract:The encoder-decoder CNN architecture has greatly improved CT medical image segmentation, but it encounters a bottleneck due to the loss of details in the encoding process, which limits the accuracy improvement. To address this problem, we propose a multi-scale context-attention network (MC-Net). The key idea is to explore the useful information across multiple scales and the context for the segmentation of objects of medical interest. Through the introduction of multi-scale and context-attention modules, MC-Net gains the ability to extract local and global semantic information around targets. To further improve the segmentation accuracy, we weight the pixels depending on whether they belong to targets. Many experiments on a lung dataset and a bladder dataset demonstrate that the proposed MC-Net outperforms state-of-the-art methods in terms of accuracy, sensitivity, the area under the receiver operating characteristic curve and the Dice score.

Abstract:Traditional convolutional neural networks (CNNs) and transformer models have limitations when dealing with long sequences. To address this issue, we introduced the Mamba framework from the State Space Model (SSM). Preserve image details through convolutional blocks while utilizing bidirectional attention decoding. Finally, we proposed a lightweight medical segmentation model that demonstrated competitiveness on six common datasets. Presently, State Space Models (SSMs), including frameworks like Mamba, have been incorporated into the realm of computer vision. These models not only sustain remote interactions and encapsulate global semantic information effectively, but also preserve linear computational complexity, offering a balance between performance and computational efficiency. Given that Mamba inherently adheres to the principle of selectivity when constructing sequence models, the goal is to further unleash the potential of Mamba through this innovative combination of convolution and self‐attention, improve accuracy and minimize the number of parameters while achieving linear complexity. Mamba is employed as an encoder to distill semantic information from the image, and it is supplemented with convolutional blocks, thereby conserving the details of the image. Concurrently, embedding prompts at a deeper level enhances its adaptability to cater to diverse requirements. Lastly, a bidirectional attention mechanism is incorporated for inference, striving to retain both global connections and local details to the maximum extent. This culminates in a novel, lightweight medical segmentation model. Exhaustive experiments were executed on six public datasets. The empirical results show that the proposed model exhibits competitive performance in medical image segmentation tasks.

Abstract:The purpose of medical image segmentation is to identify target organs, tissues or lesion areas at the pixel level to help doctors evaluate and prevent diseases. Therefore, the model is required to have higher accuracy and robust representation. At present, the proposed models focus on the improvement of performance, and ignore the number of trainable parameters. This paper proposes a lightweight ECA-Residual module to build a model encoder, which can effectively extract features while reducing the number of parameters. The feature fusion of encoder and decoder using simple skip connections will produce semantic differences. Therefore, in this paper a spatial attention gating module is designed to solve this problem. The module suppresses the image irrelevant area and improves the performance of the model while ensuring the computational efficiency. The experiment is carried out on the Synapse dataset, and the results are superior to the current advanced models in terms of accuracy and parameter quantity with 84.21 % dice coefficient and 12.79 HD95. In addition, the accuracy of the model on the ACDC dataset is also better than the current advanced model, which proves the robustness and generalization of the model.

Abstract:Medical image segmentation involves identifying and separating object instances in a medical image to delineate various tissues and structures, a task complicated by the significant variations in size, shape, and density of these features. Convolutional neural networks (CNNs) have traditionally been used for this task but have limitations in capturing long-range dependencies. Transformers, equipped with self-attention mechanisms, aim to address this problem. However, in medical image segmentation it is beneficial to merge both local and global features to effectively integrate feature maps across various scales, capturing both detailed features and broader semantic elements for dealing with variations in structures. In this paper, we introduce MSA$^2$Net, a new deep segmentation framework featuring an expedient design of skip-connections. These connections facilitate feature fusion by dynamically weighting and combining coarse-grained encoder features with fine-grained decoder feature maps. Specifically, we propose a Multi-Scale Adaptive Spatial Attention Gate (MASAG), which dynamically adjusts the receptive field (Local and Global contextual information) to ensure that spatially relevant features are selectively highlighted while minimizing background distractions. Extensive evaluations involving dermatology, and radiological datasets demonstrate that our MSA$^2$Net outperforms state-of-the-art (SOTA) works or matches their performance. Abstract:Medical image segmentation plays a crucial role in clinical assistance for diagnosis. The UNet-based network architecture has achieved tremendous success in the field of medical image segmentation. However, most methods commonly employ element-wise addition or channel merging to fuse features, resulting in smaller differentiation of feature information and excessive redundancy. Consequently, this leads to issues such as inaccurate lesion localization and blurred boundaries in segmentation. To alleviate these problems, the Multi-scale Subtraction and Multi-key Context Conversion Networks (MSMCNet) are proposed for medical image segmentation. Through the construction of differentiated contextual representations, MSMCNet emphasizes vital information and achieves precise medical image segmentation by accurately localizing lesions and enhancing boundary perception. Specifically, the construction of differentiated contextual representations is accomplished through the proposed Multi-scale Non-crossover Subtraction (MSNS) module and Multi-key Context Conversion Module (MCCM). The MSNS module utilizes the context of MCCM coding and redistribute the value of feature map pixels. Extensive experiments were conducted on widely used public datasets, including the ISIC-2018 dataset, COVID-19-CT-Seg dataset, Kvasir dataset, as well as a privately constructed traumatic brain injury dataset. The experimental results demonstrated that our proposed MSMCNet outperforms state-of-the-art medical image segmentation methods across different evaluation metrics.
PMFSNet: Polarized Multi-scale Feature Self-attention Network For Lightweight Medical Image Segmentation

Abstract:Current state-of-the-art medical image segmentation methods prioritize accuracy but often at the expense of increased computational demands and larger model sizes. Applying these large-scale models to the relatively limited scale of medical image datasets tends to induce redundant computation, complicating the process without the necessary benefits. This approach not only adds complexity but also presents challenges for the integration and deployment of lightweight models on edge devices. For instance, recent transformer-based models have excelled in 2D and 3D medical image segmentation due to their extensive receptive fields and high parameter count. However, their effectiveness comes with a risk of overfitting when applied to small datasets and often neglects the vital inductive biases of Convolutional Neural Networks (CNNs), essential for local feature representation. In this work, we propose PMFSNet, a novel medical imaging segmentation model that effectively balances global and local feature processing while avoiding the computational redundancy typical in larger models. PMFSNet streamlines the UNet-based hierarchical structure and simplifies the self-attention mechanism's computational complexity, making it suitable for lightweight applications. It incorporates a plug-and-play PMFS block, a multi-scale feature enhancement module based on attention mechanisms, to capture long-term dependencies. Extensive comprehensive results demonstrate that even with a model (less than 1 million parameters), our method achieves superior performance in various segmentation tasks across different data scales. It achieves (IoU) metrics of 84.68%, 82.02%, and 78.82% on public datasets of teeth CT (CBCT), ovarian tumors ultrasound(MMOTU), and skin lesions dermoscopy images (ISIC 2018), respectively.
