Abstract:Recently, the medical image segmentation scheme combining Vision Transformer (ViT) and multilayer perceptron (MLP) has been widely used. However, one of its disadvantages is that the feature fusion ability of different levels is weak and lacks flexible localization information. To reduce the semantic gap between the encoding and decoding stages, we propose a mixture conv-MLP network with multi-scale features fusion Unet (MCNMF-Unet) for medical image segmentation. MCNMF-Unet is a U-shaped network based on convolution and MLP, which not only inherits the advantages of convolutional in extracting underlying features and visual structures, but also utilizes MLP to fuse local and global information of each layer of the network. MCNMF-Unet performs multi-layer fusion and multi-scale feature map skip connections in each network stage so that all the feature information can be fully utilized and the gradient disappearance problem can be alleviated. Additionally, MCNMF-Unet incorporates a multi-axis and multi-windows MLP module. This module is fully end-to-end and eliminates the need to consider the negative impact of image cropping. It not only fuses information from multiple dimensions and receptive fields but also reduces the number of parameters and computational complexity. We evaluated the proposed model on BUSI, ISIC2018 and CVC-ClinicDB datasets. The experimental results show that the performance of our proposed model is superior to most existing networks, with an IoU of 84.04% and a F1-score of 91.18%.

Abstract:ABSTRACT In recent years, U‐Net and its variants have gained widespread use in medical image segmentation. One key aspect of U‐Net's design is the skip connection, facilitating the retention of detailed information and leading to finer segmentation results. However, existing research often concentrates on enhancing either the encoder or decoder, neglecting the semantic gap between them, and resulting in suboptimal model performance. In response, we introduce Multi‐Scale Fusion module aimed at enhancing the original skip connections and addressing the semantic gap. Our approach fully incorporates the correlation between outputs from adjacent encoder layers and facilitates bidirectional information exchange across multiple layers. Additionally, we introduce Channel Relation Perception module to guide the fused multi‐scale information for efficient connection with decoder features. These two modules collectively bridge the semantic gap by capturing spatial and channel dependencies in the features, contributing to accurate medical image segmentation. Building upon these innovations, we propose a novel network called MFH‐Net. On three publicly available datasets, ISIC2016, ISIC2017, and Kvasir‐SEG, we perform a comprehensive evaluation of the network. The experimental results show that MFH‐Net exhibits higher segmentation accuracy in comparison with other competing methods. Importantly, the modules we have devised can be seamlessly incorporated into various networks, such as U‐Net and its variants, offering a potential avenue for further improving model performance.

Abstract:Human CRBN (cereblon) gene is located on chromosome 3 at 3p26 and its encoding protein is a member of E3 ubiquitin ligase complex (composed of CRBN, DDB1, CUL4A and ROC1). The E3 ubiquitin ligase complex functions in the ubiquitin-proteasome protein degradation pathway and attaches polyubiquitin chains to substrate proteins for degradation via the protease complex. Currently, there are no standardized assays for CRBN gene and protein measurement although quantitative reverse transcription polymerase chain reaction (qRT-PCR), immunohistochemistry and Western blot are widely used. CRBN has been identified as a direct target for immunomodulatory drugs (IMiD) and plays a significant role in anti-proliferation, pro-apoptotic effects, anti-angiogenic activities, immunomodulatory activities and intervention of cell surface adhesion molecules between myeloma cells and bone marrow stromal cells. Recently, clinical data show that majority of the multiple myeloma patients treated with IMiD develop drug-resistance over time by unknown mechanisms. Fortunately, various in vivo and in vitro studies have revealed that the decreased CRBN expression or CRBN deletion is associated with resistance to IMiD in treating multiple myeloma, and CRBN expression levels may have a prognostic significance. Furthermore, the most recently discovered protein IKZF1, IKZF3, IRF4, C/EBPβ and Wnt/catenin signaling pathways may also be closely related to IMiD resistance in myeloma.
CFPNet-M: A Light-Weight Encoder-Decoder Based Network for Multimodal Biomedical Image Real-Time Segmentation

Abstract:Currently, developments of deep learning techniques are providing instrumental to identify, classify, and quantify patterns in medical images. Segmentation is one of the important applications in medical image analysis. In this regard, U-Net is the predominant approach to medical image segmentation tasks. However, we found that those U-Net based models have limitations in several aspects, for example, millions of parameters in the U-Net consuming considerable computation resource and memory, lack of global information, and missing some tough objects. Therefore, we applied two modifications to improve the U-Net model: 1) designed and added the dilated channel-wise CNN module, 2) simplified the U shape network. Based on these two modifications, we proposed a novel light-weight architecture -- Channel-wise Feature Pyramid Network for Medicine (CFPNet-M). To evaluate our method, we selected five datasets with different modalities: thermography, electron microscopy, endoscopy, dermoscopy, and digital retinal images. And we compared its performance with several models having different parameter scales. This paper also involves our previous studies of DC-UNet and some commonly used light-weight neural networks. We applied the Tanimoto similarity instead of the Jaccard index for gray-level image measurements. By comparison, CFPNet-M achieves comparable segmentation results on all five medical datasets with only 0.65 million parameters, which is about 2% of U-Net, and 8.8 MB memory. Meanwhile, the inference speed can reach 80 FPS on a single RTX 2070Ti GPU with the 256 by 192 pixels input size.

Relationship of insulin binding to amino acid transport by cultured 14-day embryonic chick heart cells.

Abstract:The characteristics of insulin receptors were studied in cultured embryonic chick heart cells which demonstrated insulin-responsive amino acid transport. Binding of [125I]iodoinsulin was time dependent, reversible, saturable, species specific, and proportional to cell number. Optimum binding occurred at pH 7.8 in the presence of 0.1% bovine serum albumin. Curvilinear Scatchard plots were found for chicken and bovine insulin binding at 15 and 30 C. Equilibrium association constants (Kas) and maximum capacities were calculated based on a two-receptor model. When studied at 15 C, chicken insulin was bound with Kas of 5.0 and 0.026 nM-1 for the high and low affinity receptors, respectively. Bovine insulin bound with Kas of 2.1 and 0.03 nM-1. The binding capacities of 600 and 9000 molecules/cell for the high and low affinity receptors, respectively, were the same for both species of ligand. At 30 C, the Ka of the high affinity chicken insulin receptor interaction decreased to 1.6 nM-1, whereas the low affinity Ka was not changed. In competitive binding assays, chicken insulin was 4 and 250 times more potent than bovine and guinea pig insulin, respectively. Human GH and mouse epidermal growth factor did not compete with chicken insulin. Although mouse epidermal growth factor did not compete with insulin, it did stimulate 2-aminoisobutyric acid accumulation. The maximal stimulation by this hormone was less than and additive to that produced by the maximal stimulation of insulin. These data indicate that insulin and epidermal growth factor acted through different receptors to stimulate amino acid transport. When insulin-stimulated functional response was compared to calculated receptor occupancy in this two-receptor model, stimulation of amino acid transport paralleled occupancy of the low affinity receptor such that at half-maximal transport stimulation, approximately 50% of these receptors were occupied. Half-maximal stimulation of 2-aminoisobutyric acid transport occurred at 18- and 20-nM concentrations of bovine and chicken insulins, respectively. Guinea pig insulin failed to stimulate 2-aminoisobutyric acid uptake even at 350 nM. Both the affinity of binding in the low affinity class and the insulin concentration for half-maximal stimulation of 2-aminoisobutyric acid transport were independent of temperature in the temperature ranges studied. We conclude that 14-day embryonic chick heart cells possess at least two classes of receptors which bind insulin. Occupancy of the lower affinity class of insulin receptors correlates quantitatively with insulin stimulation of 2-aminoisobutyric acid transport.

Abstract:Medical image segmentation is a crucial step in the clinical applications for diagnosis and analysis of some diseases. U-Net-based convolution neural networks have achieved impressive performance in medical image segmentation tasks. However, the multi-level contextual information integration capability and the feature extraction ability are often insufficient. In this paper, we present a novel multi-level context fusion network (MCF-Net) to improve the performance of U-Net on various segmentation tasks by designing three modules, hybrid attention-based residual atrous convolution (HARA) module, multi-scale feature memory (MSFM) module, and multi-receptive field fusion (MRFF) module, to fuse multi-scale contextual information. HARA module was proposed to effectively extract multi-receptive field features by combing atrous spatial pyramid pooling and attention mechanism. We further design the MSFM and MRFF modules to fuse features of different levels and effectively extract contextual information. The proposed MCF-Net was evaluated on the ISIC 2018, DRIVE, BUSI, and Kvasir-SEG datasets, which have challenging images of many sizes and widely varying anatomy. The experimental results show that MCF-Net is very competitive with other U-Net models, and it offers tremendous potential as a general-purpose deep learning model for 2D medical image segmentation.

Abstract:Medical image segmentation is a challenging and popular task in the field of medical image processing in recent decades. Most of the current mainstream segmentation networks are based on convolutional neural networks (CNNs) methods. Among them, encoding and decoding structures based on U-Net architecture and skip connection mechanism have made great progress in medical segmentation. However, these networks come with increased complexity and training difficulty as the accuracy of network segmentation continues to increase, and their ability remains to be improved for extracting feature information in specific information-intensive structure segmentation tasks, such as brain tumors. In addition, the high training cost raises the application threshold of medical image segmentation. To address these issues, we introduce a frequency representation approach that can effectively reduce the loss of feature during encoding and decoding of segmentation networks. Then a tokenized multi-layer perceptron (MLP) method is introduced to learn the space information. Frequency representation and tokenized MLP can greatly reduce the parameters and computational effort while achieving more accurate and efficient medical image segmentation. Therefore, a multi-level lightweight U-Net segmentation network named MLU-Net is proposed to perform segmentation tasks of medical images quickly. In brain tumor segmentation experiments under equivalent preprocessing conditions, our network achieves substantial efficiency gains with parameter and computational workload reductions to 1/39 and 1/61 of U-Net's, while simultaneously demonstrating superior performance, enhancing the Dice and Intersection over Union (IoU) metrics by 3.37% and 3.30%, respectively. In addition, we perform experiments on dermatologic data and still achieve segmentation performance that outperforms comparable networks. These experiments show that the proposed network is characterized by lightweight and high accuracy, which is contributing to the exploration of clinical medicine scenarios.

Abstract:In the process of cancer diagnosis and treatment, accurate extraction of the lesion area helps the doctor to judge the condition. Currently, medical image segmentation algorithms based on UNet have been verified to be able to play an important role in clinical diagnosis. However, these methods still have the following drawbacks in extracting the region of interest (ROI): (1) ignoring the intra-class variability of medical images. (2) Failure to obtain effective feature redundancy. To address these problems, a U-shaped medical image segmentation network based on a Mixed depthwise convolution residual module (MDRM), called MD-UNet, is proposed in this paper. In MD-UNet, the MDRM built with a Mixed depthwise convolution attention block (MDAB) captures both local and global dependencies in the image to mitigate the effects of intra-class differences. MDAB captures valid redundant features and further captures global features of the input data. At the same time, the lightweight MDAB senses changes in the receptive field and generates multiple feature mappings. Compared with UNeXt on the ISIC2018 dataset, the MD-UNet segmentation accuracy Dice and IoU are improved by 1.33% and 1.91%, respectively. Abstract:Accurate segmentation of target areas in medical images, such as lesions, is essential for disease diagnosis and clinical analysis. In recent years, deep learning methods have been intensively researched and have generated significant progress in medical image segmentation tasks. However, most of the existing methods have limitations in modeling multilevel feature representations and identification of complex textured pixels at contrasting boundaries. This paper proposes a novel coupled refinement and multiscale exploration and fusion network (CRMEFNet) for medical image segmentation, which explores in the optimization and fusion of multiscale features to address the abovementioned limitations. The CRMEFNet consists of three main innovations: a coupled refinement module (CRM), a multiscale exploration and fusion module (MEFM), and a cascaded progressive decoder (CPD). The CRM decouples features into low-frequency body features and high-frequency edge features, and performs targeted optimization of both to enhance intraclass uniformity and interclass differentiation of features. The MEFM performs a two-stage exploration and fusion of multiscale features using our proposed multiscale aggregation attention mechanism, which explores the differentiated information within the cross-level features, and enhances the contextual connections between the features, to achieves adaptive feature fusion. Compared to existing complex decoders, the CPD decoder (consisting of the CRM and MEFM) can perform fine-grained pixel recognition while retaining complete semantic location information. It also has a simple design and excellent performance. The experimental results from five medical image segmentation tasks, ten datasets and twelve comparison models demonstrate the state-of-the-art performance, interpretability, flexibility and versatility of our CRMEFNet.

Abstract:The U-Net and its extensions have achieved good success in medical image segmentation. However, fine-grained segmentation of the objects at their fuzzy edges, which is commonly found in medical images, is still challenging. In this paper, we propose a U-Net like Multi-Stage Feature Analysis Network (MFA U-Net) for medical image segmentation, which focus on mining the reusability of the images and features from several perspectives. Firstly, a multi-channel dimensional feature extraction module is proposed, where the input image was reused by multiple branches of convolutions with different channels to generate supplement features to the original U shaped network. Next, a cascaded U-shaped network is designed for deeper feature mining and analysis, which enables progressive refinement of the features. In the neck of the cascaded network, a parallel hybrid convolution module is designed that concatenating several types of convolutional methods to enhance the semantic representation ability of the model. In short, by reusing of the input images and detected features in several stages, more effective features were extracted and the segmentation performances were improved. The proposed algorithm was evaluated by three mainstream 2D color medical image segmentation datasets and gets significant improvements compared with the traditional U-Net framework, as well as the latest improved ones. Compared to the baseline network, it gets the improvements of 0.93% (Dice) and 1.45% (IoU) on GlaS, 2.09% (Dice) and 2.87% (IoU) on MoNuSeg, and 0.17% (F1) and 1.72% (SE) on DRIVE.

Abstract:Semantic segmentation is an exciting research topic in medical image analysis because it aims to detect objects in medical images. In recent years, approaches based on deep learning have shown a more reliable performance than traditional approaches in medical image segmentation. The U-Net network is one of the most successful end-to-end convolutional neural networks (CNNs) presented for medical image segmentation. This paper proposes a multiscale Residual Dilated convolution neural network (MSRD-UNet) based on U-Net. MSRD-UNet replaced the traditional convolution block with a novel deeper block that fuses multi-layer features using dilated and residual convolution. In addition, the squeeze and execution attention mechanism (SE) and the skip connections are redesigned to give a more reliable fusion of features. MSRD-UNet allows aggregation of contextual information, and the network goes without needing to increase the number of parameters or required floating-point operations (FLOPS). The proposed model was evaluated on three multimodal datasets: polyp, skin lesion, and nuclei segmentation. The obtained results proved that the MSDR-Unet model outperforms several state-of-the-art U-Net-based methods.
MLFEU-NET: A Multi-scale Low-level Feature Enhancement Unet for breast lesions segmentation in ultrasound images

Abstract:Breast lesions constantly threaten the health of females. Segmentation methods of breast lesions are important for clinical diagnosis, and neural networks have been widely used and played a significant role in this field. However, false detections and miss detections still exist due to the variability in the shape and location of breast lesions, artifacts and noise in breast ultrasound (BUS) images, and structural defects in conventional segmentation networks. In this paper, a multi-scale low-level feature enhancement Unet (MLFEU-net) structure is presented, consisting of the U-net structure, low-level feature enhancement block (LFEB), and a parallel multiscale feature fusion (PMFF) module. Specifically, LFEB enhances the detail information during shallow downsampling and further feature selection. Meanwhile, in the neck of Unet, PMFF module uses different scales of dilation convolution to provide different sizes of sensory fields, and to efficiently merge shallow and deep features filtered, leads to more accurate segmentation results. To evaluate the MLFEU-net's segmentation ability, five quantitative metrics were used on two breast ultrasound datasets, and it was compared with several advanced segmentation techniques. The results illustrate that our approach surpasses other methods in performance. Moreover, robustness experiments validate the effectiveness of our approach in achieving robust segmentation of breast lesions.

Abstract:Since deep learning is introduced to medical image segmentation, UNet and its variants have been extensively applied in medical image analysis. This paper proposes a multi-scale channel attention UNet (MSCA-UNet) to raise the accuracy of the segmentation in medical ultrasound images. Specifically, a multi-scale module is constructed to connect and to enhance the feature maps with different scales extracted by convolution. Subsequently, A channel attention mechanism is designed to compress feature maps through learnable depth separable convolutions. Eventually, we have explored the global feature module to establish the dependency between multi-level features. The proposed method is thoroughly evaluated and compared with the existing methods on four medical ultrasound image datasets. The experiments indicate that our method outperforms the SOTA method in accuracy on four medical ultrasound image datasets. Compared with UNet network, the parameters of our model have decreased 29.82%. In addition, visual comparisons further demonstrate the proposed method.

Abstract:Breast lesion segmentation in ultrasound images is of great importance since it can help us to characterize and localize lesion regions. However, low-quality imaging, blurred boundary, and variable lesion shapes bring challenges to accurate segmentation. In recent years, many U-Net variants have been proposed and successfully applied to breast lesion segmentation. However, these methods suffer from two limitations: 1) ignoring the ability to capture rich global context information and 2) introducing extra complex operations. To alleviate these challenges, we propose a multiscale nonlocal feature extraction network (MNFE-Net) for accurately segmenting breast lesions. The core idea includes three points: 1) parallel encoder (PE) models long-range dependencies; 2) multiscale feature module (MFM) refines local features without introducing extra complex operations; and 3) global feature guidance module (GFGM) extracts global semantic information. MNFE-Net mainly has the following advantages: 1) the method has excellent performance for segmentation of malignant breast lesions; 2) the PE increases network parameters without significantly decreasing inference speed; and 3) the method is easy to understand and execute. Extensive experiment results with six state-of-the-art (SOTA) methods on three public breast ultrasound datasets demonstrate the superior segmentation performance of our proposed MNFE-Net.
UNet 3+: A Full-Scale Connected UNet for Medical Image Segmentation

Abstract:Recently, a growing interest has been seen in deep learning-based semantic segmentation. UNet, which is one of deep learning networks with an encoder-decoder architecture, is widely used in medical image segmentation. Combining multi-scale features is one of important factors for accurate segmentation. UNet++ was developed as a modified Unet by designing an architecture with nested and dense skip connections. However, it does not explore sufficient information from full scales and there is still a large room for improvement. In this paper, we propose a novel UNet 3+, which takes advantage of full-scale skip connections and deep supervisions. The full-scale skip connections incorporate low-level details with high-level semantics from feature maps in different scales; while the deep supervision learns hierarchical representations from the full-scale aggregated feature maps. The proposed method is especially benefiting for organs that appear at varying scales. In addition to accuracy improvements, the proposed UNet 3+ can reduce the network parameters to improve the computation efficiency. We further propose a hybrid loss function and devise a classification-guided module to enhance the organ boundary and reduce the over-segmentation in a non-organ image, yielding more accurate segmentation results. Abstract:Medical image segmentation is an important means to assist doctors in making accurate diagnoses. However, medical images are often subject to noise interference, and the high similarity between the background and target areas also increases the difficulty of segmentation, hence there is room for improvement in segmentation accuracy. To address these challenges, this paper proposes a multi-scale mixed convolutional image segmentation network. The network consists of two main parts: an encoder and a decoder. The encoder is formed by a combination of mixed convolutional module and multi-scale Transformer module, and the mixed convolutional module uses a blend of 2D and 3D convolutions to enhance feature extraction capabilities. Additionally, we designed a multi-scale Transformer module aimed at capturing long-range correlation information at multiple scales. In the decoding phase, we introduce coordinate convolution for the first time in the U-Net architecture to replace traditional convolution, thereby enhancing the model's spatial localization capabilities. In experimental validations on multiple public datasets, MTC-TransUNet outperforms other networks.

FIF-UNet: An Efficient UNet Using Feature Interaction and Fusion for Medical Image Segmentation

Abstract:Nowadays, pre-trained encoders are widely used in medical image segmentation because of their ability to capture complex feature representations. However, the existing models fail to effectively utilize the rich features obtained by the pre-trained encoder, resulting in suboptimal segmentation results. In this work, a novel U-shaped model, called FIF-UNet, is proposed to address the above issue, including three plug-and-play modules. A channel spatial interaction module (CSI) is proposed to obtain informative features by establishing the interaction between encoder stages and corresponding decoder stages. A cascaded conv-SE module (CoSE) is designed to enhance the representation of critical features by adaptively assigning importance weights on different feature channels. A multi-level fusion module (MLF) is proposed to fuse the multi-scale features from the decoder stages, ensuring accurate and robust final segmentation. Comprehensive experiments on the Synapse and ACDC datasets demonstrate that the proposed FIF-UNet outperforms existing state-of-the-art methods, which achieves the highest average DICE of 86.05% and 92.58%, respectively.

Abstract:Ultrasound image segmentation is a challenging task due to the complexity of lesion types, fuzzy boundaries, and low-contrast images along with the presence of noises and artifacts. To address these issues, we propose an end-to-end multi-scale feature extraction and fusion network (MEF-UNet) for the automatic segmentation of ultrasound images. Specifically, we first design a selective feature extraction encoder, including detail extraction stage and structure extraction stage, to precisely capture the edge details and overall shape features of the lesions. In order to enhance the representation capacity of contextual information, we develop a context information storage module in the skip-connection section, responsible for integrating information from adjacent two-layer feature maps. In addition, we design a multi-scale feature fusion module in the decoder section to merge feature maps with different scales. Experimental results indicate that our MEF-UNet can significantly improve the segmentation results in both quantitative analysis and visual effects.
