Abstract:Electrical probe measurements are carried out at the scrape‐off‐layer (SOL) and divertor regions in order to investigate the characteristics of edge plasmas during H‐mode discharges in the Korea Superconducting Tokamak Advanced Research (KSTAR) device. Radial profiles of plasma parameters such as electron temperature Te, plasma density ne, and parallel flow velocity v‖ are measured by using a fast reciprocating Langmuir probe assembly (FRLPA) at the SOL region. From the FRLPA measurements, it is found that the decay length of temperature λTe and that of density λne are 2 ∼ 4 cm and 1 ∼ 3 cm, respectively. The magnitude of v‖ near the last closed flux surface (LCFS) is 4 ∼ 15 km/s. The radial flux due to edge turbulence at the SOL region is investigated by using spectra analysis on electrostatic fluctuation levels such as ion saturation current Ĩis and floating potential $ \tilde{\rm V}_f$ obtained from the FRLPA measurement. The value of the flux is estimated as ∼ 1020 particle m−2 s −1 near the LCFS. The poloidal distribution of the ion saturation current density jis is measured by fixed edge Langmuir probe array (ELPA) at the divertor region, and it is found that the positions of strike points from the ELPA measurement agree well with those reconstructed from the EFIT result using magnetic diagnostic data. From the spectrum analysis on the ELPA measurements at the divertor region during edge localized modes (ELMs) control in the H‐mode discharges, it is observed that the magnitude of $ \tilde{\rm j}_{is}$(ω) near strike point decreases when the ELMs are suppressed or mitigated (© 2013 WILEY‐VCH Verlag GmbH & Co. Using convolutional neural networks to detect edge localized modes in DIII-D from Doppler backscattering measurements

Abstract:In H-mode tokamak plasmas, the plasma is sometimes ejected beyond the edge transport barrier. These events are known as edge localized modes (ELMs). ELMs cause a loss of energy and damage the vessel walls. Understanding the physics of ELMs, and by extension, how to detect and mitigate them, is an important challenge. In this paper, we focus on two diagnostic methods—deuterium-alpha (Dα) spectroscopy and Doppler backscattering (DBS). The former detects ELMs by measuring Balmer alpha emission, while the latter uses microwave radiation to probe the plasma. DBS has the advantages of having a higher temporal resolution and robustness to damage. These advantages of DBS diagnostic may be beneficial for future operational tokamaks, and thus, data processing techniques for DBS should be developed in preparation. In sight of this, we explore the training of neural networks to detect ELMs from DBS data, using Dα data as the ground truth. With shots found in the DIII-D database, the model is trained to classify each time step based on the occurrence of an ELM event. The results are promising. When tested on shots similar to those used for training, the model is capable of consistently achieving a high f1-score of 0.93. This score is a performance metric for imbalanced datasets that ranges between 0 and 1. We evaluate the performance of our neural network on a variety of ELMs in different high confinement regimes (grassy ELM, RMP mitigated, and wide-pedestal), finding broad applicability. Beyond ELMs, our work demonstrates the wider feasibility of applying neural networks to data from DBS diagnostic.

Abstract:As the critical dimension of transistors has become lower and the stacked layer of semiconductors has become higher, virtual diagnostics to monitor the status of plasma in an etching process has been important because of the reliability of process. In this study, we proposed the model to predict a plasma density of the etch equipment with high accuracy using OES data despite a small number of process conditions. The proposed model could improve the prediction performance of multilayer perceptron by using pre-trained variational auto-encoder as an initializer and had the best performance of several regression methods. At application point of view, it is expected that the model can be used to monitor a plasma density when a wafer is absent from the chamber. Moreover, using the proposed model can more easily understand the status of plasma rather than monitoring thousands of sensor data even without the knowledge about plasma.

Abstract:The present research focuses on investigating deep neural networks techniques for predicting plasma disruptions in tokamaks. For this purpose, various deep-learning predictive models and several plasma diagnostics will be analyzed, using data gathered during the experimental campaigns conducted at the JET nuclear fusion tokamak between 2011 and 2020. The primary objective of this study is to show that the contribution of the MHD spectrograms increases the disruption predictor performance. The final deep-learning prediction model leverages the capability of Convolutional Neural Networks to directly learn important spatiotemporal information from 1D plasma profiles of temperature, density and power radiation, obtained from High Resolution Thomson Scattering and Bolometer diagnostics, as well as from spectrograms generated by a set of fast magnetic pick-up coils known as Mirnov coils. The Convolutional Neural Network eliminates the need for manual feature extraction methods that characterize the majority of machine learning methods. Using plasma profiles information allows to distinguish between core radiation caused by impurity accumulations and outboard radiation phenomena. Likewise, the decision to incorporate spectrograms from Mirnov coils is based on the diagnostic's ability to measure magnetic fluctuations originating from MHD instabilities, which can lead to disruptions. In order to address phenomena characterized by fast temporal dynamics, the inclusion of the locked mode signal was chosen. This signal is commonly employed at JET to trigger mitigation actions. It is integrated into an alarm scheme that employs both AND/OR logic and optimized thresholds, ensuring its effectiveness. The proposed predictor exhibits significant performance, with only one missed alarm out of 92 disrupted discharges and three false alarms out of 131 regularly terminated discharges in the test set.

Abstract:Tokamaks allow to confine fusion plasma with magnetic fields and one of the main challenges in the control of the magnetic configuration is the prediction/reconstruction of the Last Closed-Flux Surface (LCFS). The evolution in time of the LCFS is determined by the interaction of the actuator coils and the internal tokamak plasma. This task requires real-time capable tools able to deal with high-dimensional data as well as with high resolution in time, where the interaction between a wide range of input actuator coils with internal plasma state responses add additional layer of complexity. In this work, we present the application of a novel state of the art machine learning model to the LCFS reconstruction in the Experimental Advanced Superconducting Tokamak (EAST) that learns automatically from the experimental data of EAST. This architecture allows not only offline simulation and testing of a particular control strategy, but can also be embedded in the real-time control system for online magnetic equilibrium reconstruction and prediction. In the real-time modeling test, our approach achieves very high accuracies, with over 99% average similarity in LCFS reconstruction of the entire discharge process.

Abstract:Modern laboratory techniques like ultrafast laser excitation and shock compression can bring matter into highly nonequilibrium states with complex structural transformation, metallization and dissociation dynamics. To understand and model the dramatic change of both electronic structures and ion dynamics during such dynamic processes, the traditional method faces difficulties. Here, we demonstrate the ability of deep neural network (DNN) to capture the atomic local-environment dependence of electronic density of states (DOS) for both multicomponent system under exoplanet thermodynamic condition and nonequilibrium system during super-heated melting process. Large scale and time-resolved diagnosis of DOS can be efficiently achieved within the accuracy of ab initio method. Moreover, the atomic contribution to DOS given by DNN model accurately reveals the information of local neighborhood for selected atom, thus can serve as robust order parameters to identify different phases and intermediate local structures, strongly highlights the efficacy of this DNN model in studying dynamic processes.

Abstract:In this research, we propose a deep learning-based approach for disruption prediction in KSTAR using In-vessel Visible Inspection System (IVIS) video and 0D parameters. Here, using video data is beneficial as it contains time-varying position and shape of plasma. We demonstrate the possibility of predicting disruption with video data only as early as approximately 20 ms before disruptions, but there is a limit over 20 ms. Thus, we incorporated 0D data and developed a multimodal model to enhance the accuracy and showed the capability of predicting disruption with multimodal data as early as 95.20 ms. To analyze model capabilities, we used t-distributed Stochastic Neighbor Embedding (t-SNE) to describe the latent space of models to compare with capabilities. We analyzed vision models using Gradient-weighted Class Activation Mapping (GradCAM) and Attention Rollout to check the abilities to capture the features. We employed permutation feature importance to identify critical 0D parameters. Consequently, we demonstrated the effectiveness of our approach for disruption prediction in KSTAR.

Abstract:Disruption in tokamak plasmas, stemming from various instabilities, poses a critical challenge, resulting in detrimental effects on the associated devices. Consequently, the proactive prediction of disruptions to maintain stability emerges as a paramount concern for future fusion reactors. While data-driven methodologies have exhibited notable success in disruption prediction, conventional neural networks within a frequentist approach cannot adequately quantify the uncertainty associated with their predictions, leading to overconfidence. To address this limit, we utilize Bayesian deep probabilistic learning to encompass uncertainty and mitigate false alarms, thereby enhancing the precision of disruption prediction. Leveraging 0D plasma parameters from EFIT and diagnostic data, a Temporal Convolutional Network adept at handling multi-time scale data was utilized. The proposed framework demonstrates proficiency in predicting disruptions, substantiating its effectiveness through successful applications to KSTAR experimental data.

Machine learning assisted analysis of visible spectroscopy in pulsed-power-driven plasmas

Abstract:We use machine learning models to predict ion density and electron temperature from visible emission spectra, in a high energy density pulsed-power-driven aluminum plasma, generated by an exploding wire array. Radiation transport simulations, which use spectral emissivity and opacity values generated using the collisional-radiative code PrismSPECT, are used to determine the spectral intensity generated by the plasma along the spectrometer's line of sight. The spectra exhibit Al-II and Al-III lines, whose line ratios and line widths vary with the density and temperature of the plasma. These calculations provide a 2500-size synthetic dataset of 400-dimensional intensity spectra, which is used to train and compare the performance of multiple machine learning models on a 3-variable regression task. The AutoGluon model performs best, with an R2-score of roughly 98% for density and temperature predictions. Simpler models (random forest, k-nearest neighbor, and deep neural network) also exhibit high R2-scores (>90%) for density and temperature predictions. These results demonstrate the potential of machine learning in providing rapid or real-time analysis of emission spectroscopy data in pulsed-power-driven plasmas.

Abstract:Langmuir probes have been widely used in the field of plasma diagnostics for the characterisation of plasma properties. These probes play a crucial role in understanding the behaviour of a diverse range of plasmas, e.g. edge plasmas in fusion experiments. The measurement of electron density (n e ) and electron temperature (T e ) provides valuable insights into the plasma's state, stability, and confinement properties. Conventionally, this analysis involves post-experiment fitting methods to calculate plasma properties from the measured current-voltage curves obtained from Langmuir probes. This work introduces a neural-network approach for analysing probe data from the TJ-K stellarator, allowing for fast associative plasma characterisation. The results show a reliable performance on test data within the domain of the training set, predicting both n e and T e within the 10 % intrinsic error. Performance on unseen data outside the domain of the training set was on average within a 26 % and 21 % error on n e and T e , respectively. The network's further abilities, including the identification of low-quality and falsely-labelled data, were also explored. The use of neural networks offers fast predictions, enabling further research into real-time applications and live feedback control. This paper highlights the promising role of neural networks in enhancing the analysis of Langmuir-probe characteristics.

Abstract:Disruptions are events in which large fractions of the plasma thermal energy are lost due to the uncontrolled growth of some large-scale plasma instability. Major disruptions lead to the sudden termination of plasma current in a very short timescale. A data-driven methodology employing time series analysis using relevant plasma parameters for prediction of the disruption event before sufficient alarming time is useful due to the absence of first-principle physics methods. ADITYA ( $R$ 0 $=$ 75 cm and $a$ $=$ 25 cm), an ohmically heated circular limiter tokamak, has been upgraded to a tokamak named the ADITYA Upgrade (ADITYA-U) with an open diverter configuration. Based on previous ADITYA $\sim$ 8000 discharges, time series regression analysis has been developed using various long short-term memory (LSTM)-based deep learning methods such as Stacked, Bidirectional, ConvLSTM2D, and Auto Encoder LSTM. The results are assessed with ADITYA data and benchmarked to optimize results for final model deployment. Root-mean-square error (RMSE) is used to measure error during training and testing the neural network prediction. The anomalies in the signal prediction are closely analyzed in each LSTM method. Furthermore, the data sequence is modified for time series data to get higher optimization in training time. The analytical data using the model achieve sufficient anticipation time to predict the plasma disruption event as per the desired requirement. ConvLSTM2D gives promising results among other methods, but Auto Encoder LSTM provides higher accuracy for unseen data in real-time prediction with the lowest RMSE of 1.79. The final model will be used for inference and deployment for accurate prediction of the disruption event at ADITYA-U tokamak.

Abstract:This research explores the feasibility of extracting plasma molecular temperatures from visible images, an approach aimed at circumventing expensive spectrometer equipment and intricate, time-consuming processes involved in spectral acquisition and diagnostics. In our experiment, the emission spectrum data of needle-plate air discharge plasma under various working conditions are collected, and the optical emission spectroscopy analysis method is employed to diagnose the rotational and vibrational temperatures of nitrogen molecules. Simultaneously, visible images of plasma discharge are collected to establish a comprehensive dataset encompassing a broad temperature range. The extracted chromaticity information or the features automatically extracted by the convolutional neural network (CNN) from plasma visible images is utilized to conduct regression analysis on the plasma rotational and vibrational temperatures. This machine learning approach enables continuous prediction and diagnosis of plasma molecular temperatures based on visible images. The experiment results demonstrate that the best-performing CNN regression model achieves high prediction R2 of 0.9986 and 0.9948 for the two temperatures, and the prediction time of a single image is only 36.31 ms, which meets the demand for high-precision and real-time plasma diagnosis.

Abstract:The improved energy confinement mode (I-mode) is widely considered as an important operation regime for ITER. I-mode implementation depends on the specified basic plasma parameters and certain operation conditions, which are discovered by statistical plasma characteristics from a large number of I-mode discharges on a tokamak. The extraction process of I-mode plasma characteristics is complicated, time-consuming, and limited to the sampling rate of the measured signals. Experimental observation of the I-mode is accompanied by the appearance of a weakly coherent mode (WCM). However, it takes much time to accurately scan and quantify WCM characteristics when analyzing many I-mode discharges. Recently, a neural network identification method was developed as an I-mode detector to traverse a whole database as a replacement for manual identification. Two fully connected neural network models were trained with the spectrum of propagation velocity of density perturbation from Doppler backward scattering (DBS) and the electron density measured by a polarimeter-interferometer (POINT) system with the experimental advanced superconducting tokamak (EAST) I-mode database. An accuracy of 98.30% in identifying WCMs in I-mode discharges is achieved with the WCM classification model. In addition, the regime classification model was also utilized to successfully distinguish between the low confinement mode (L-mode), I-mode, and high confinement mode (H-mode) with 96.03% accuracy. Finally, ablation experiments were performed on the regime classifiers, showing that there is potential for further performance improvement with future use of RNN model.

Abstract:The neural network model, MISHKA-NN is developed to mitigate the computational burden associated with the linear ideal MHD stability analysis of the pedestal based on the peeling-ballooning model. By utilizing both 1D plasma profiles (current density, pressure gradient, and safety factor) and 0D parameters (plasma geometry, total current, and toroidal mode number), the model predicts linear growth rate of edge-localized ideal MHD instability in a given equilibrium state. By enabling the prediction of each instability within a second, the model reduces the time required for plotting a pedestal peeling-ballooning stability diagram ( diagram) from approximately 100 CPU hours to a few CPU minutes. Notably, even with the utilization of parametric pressure and current profiles and plasma boundary shapes for the training dataset, the model shows a satisfactory level of performance in benchmarking the diagram for the reconstructed equilibrium from a KSTAR tokamak experiment. We anticipate the model to serve as a versatile alternative to 2D linear MHD stability codes, alleviating numerical costs.

Abstract:A novel sparse encoding algorithm is developed to detect and study plasma instabilities automatically. This algorithm, called Elastic Random Mode Decomposition, is applied to the Mirnov coil signals of a dataset of 1291 discharges of the TJ-II stellarator, enabling the identification of the Alfvénic activity. In the presented approach, each signal is encoded as a collection of basic waveforms called atoms, drawn from a signal dictionary. Then the modes are identified using clustering and correlations with other plasma signals. The performance of the proposed algorithm is dramatically increased by using elastic net regularization and taking advantage of GPU architectures. Therefore the signal size and the number of dictionary elements are no longer limiting factors for encoding complex signals. Once the modes are retrieved from the shots, standard clustering and dimensionality reduction techniques are applied to obtain a 2D map featuring of the physical mode characteristics of this subset of TJ-II shots. The clustering features consider the relationship with the plasma current I p , the diamagnetic energy W, and inverse square root of electronic density 1/√n, profiling different subtypes of Alfvénic activity. The proposed algorithm can potentially create large databases of labeled modes with unprecedented detail.

Identifying L-H transition in HL-2A through deep learning

Abstract:During the operation of tokamak devices, addressing the thermal load issues caused by Edge Localized Modes (ELMs) eruption is crucial. Ideally, mitigation and suppression measures for ELMs should be promptly initiated as soon as the first low-to-high confinement (L-H) transition occurs, which necessitates the real-time monitoring and accurate identification of the L-H transition process. Motivated by this, and by recent deep learning boom, we propose a deep learning-based L-H transition identification algorithm on HL-2A tokamak. In this work, we have constructed a neural network comprising layers of Residual Long Short-Term Memory (LSTM) and Temporal Convolutional Network (TCN). Unlike previous work based on recognition for ELMs by slice, this method implements recognition on L-H transition process before the first ELMs crash. Therefore the mitigation techniques can be triggered in time to suppress the initial ELMs bursts. In order to further explain the effectiveness of the algorithm, we developed a series of evaluation indicators by shots, and the results show that this algorithm can provide necessary reference for the mitigation and suppression system.

Abstract:In this study, a long short-term memory (LSTM) model is trained on a large disruption warning database to predict the disruption on EAST tokomak. To compare the performance of the proposed model with the previously reported full convolutional neural network (CNN) (Guo et al 2020 Plasma Phys. Control. Fusion 63 025008), the same data set and diagnostic signals are used. Based on the test set, the area under the receiver operating characteristic curve, i.e. the AUC value of the LSTM model is obtained as 0.87, and the true positive rate (TPR) is sim87.5%, while the false positive rate (FPR) is sim15.1%. Since the LSTM model is more sensitive to radiation fluctuations than CNN, the prediction performance of LSTM model is inferior to that of CNN model (for CNN, AUC sim 0.92, TPR sim 87.5%, FPR sim 6.1%). However, the advance warning time of LSTM model is 14 ms earlier than that of CNN. To reduce the FPR and improve the performance of the model, more fast bolometer channels are added as the input signals of the LSTM model, including the radiation from the upper and lower edges and the plasma core. Consequently, for the same test set, the AUC value increases to 0.89, and the FPR decreases to sim9.4%, but the TPR also decreases to sim83.9%. In addition, the sensitivity of the model to radiation fluctuations caused by impurity behavior decreases significantly, and the warning time becomes 8.7 ms earlier as compared to that of the original model. Overall, it is proved that deep learning algorithms exhibit immense application potential in the disruption prediction of long-pulse fusion devices.

Plasma Real-time Diagnostics Based on Visual Image Recognition

Abstract:Real-time diagnostics has always been a key point of plasma research. Optical emission spectroscopy is the most commonly used method to obtain the plasma parameters through fitting of the emission curves. But the process is time-consuming, making it almost impossible to get the data in real-time. In this paper, we propose a method using image recognition for real-time diagnostics. The relationship between visual images and rotational and vibrational temperatures was established. A convolutional neural network model was used for image recognition. After training, the test accuracy was over 0.99. The model was proved to be able to predict the temperature of a new input image, indicating potential applications of image recognition in real-time plasma diagnostics.
