Abstract:The vibration behaviour of the vibrating rods is one of the key factors for the quality of concrete vibration that is essential for the long-term safety of concrete structures. Although many vibration operation regulations have been widely applied, evaluating method for concrete vibration samples is relatively rare. To fill this gap, this paper proposes a concrete vibration data acquisition system and attempts to perform a quality analysis of samples employing machine learning that amalgamates various parameters. The experimental results demonstrate that the data collection system to identify the vibration state achieves an accuracy of 93.75% and an accuracy of 90.3% in classifying vibration quality levels. The proposed method can classify and evaluate concrete quality levels, which strongly supports the visualization of concrete vibration process and the implementation of autonomous robot vibration. In the future, improving the reliability of the system and enhancing the accuracy of algorithms will be the focused.

Abstract:The vibrating of concrete is one of the most important procedures that directly determines the quality of construction projects. The concrete vibration quality in field construction is mainly judged by the experience of workers, lacking quantitative indicators, and necessary supervision. However, the lack of research about concrete vibration quality led to these problems are still existing. There are some methods are proposed that are too difficult, or too expensive to use in field construction. Combined with the pouring project of Jianquan Pumped Storage Power Station in Yunyang, China, this research developed an intelligent detection system for concrete vibration time. The system took the convolutional neural network as the basic framework, and divided the concrete vibration process into three different states: vibrating, not vibrating, and no vibration tube, realized the concrete vibration time through the analysis of concrete vibration video data. The detection of concrete vibration process video with multiple stages in the actual project shows that the detection error of the system for each state is kept within 1 s, the accuracy is high, which can meet the quality management requirements of the construction process. The system can be quickly deployed to the construction site by using mobile phones, cameras, and other common equipment. It has the advantages of simple frame structure, low hardware requirements, and accurate detection results. In addition, the current system training process is only for the concrete pouring process of Jianquan Power Station, and the training sample can be further expanded in the future to enhance the applicability and accuracy of the system in other engineering applications in order to play a better role.

Image Recognition and Parameter Analysis of Concrete Vibration State Based on Support Vector Machine

Abstract:In this paper, the directional gradient histogram technology is employed to extract the features of concrete image samples captured under different vibration states. The support vector machine (SVM) is utilized to learn the relationship between image features and vibration state. The machine learning results are subsequently used to assess the feasibility of the concrete vibration state. Simultaneously, the influence mechanism of the calculation parameters of the directional gradient histogram on the recognition accuracy is analyzed. The results demonstrate the feasibility of using the directional gradient histogram-SVM technology to identify the vibration state of concrete. The recognition accuracy initially increases and then decreases as the block size of the directional gradient, or the number of statistical intervals increases. The recognition accuracy also decreases linearly with the increase of the binarization threshold. By using sample images with a resolution of 1024 pixels x 1024 pixels and optimizing the feature extraction parameters, a recognition accuracy of 100% can be attained.

Abstract:The vibration quality of concrete is crucial to ensure the long-term safe operation of concrete structural components. In recent years, computer vision technology based on deep learning has achieved excellent results in the field of concrete quality inspection. However, when used for assisting construction inspection, this technology relies heavily on large-scale, labeled, high-quality image data. To solve this drawback, this study proposes a vision-based method that integrates semi-supervised learning and data augmentation for detecting the concrete vibration quality. Initially, StyleGAN2 was adopted as the data augmentation strategy to improve the diversity of the dataset. Then, SE-ResNet50, a model that couples an attention mechanism module and residual network, was employed as a classifier for accurately extracting information contained in images. Subsequently, in order to reduce the workload of data annotation, a novel semi-supervised learning method (Co-MixMatch) was proposed to train the model by coupling MixMatch with co-training. Finally, the trained model was deployed on mobile devices to assist onsite construction workers in detecting the quality of concrete vibration. A real-world concrete dam dataset was employed to verify the proposed method. Based on the experimental results, the proposed method improves the accuracy of the baseline method by 3.62% on average. Additionally, the proposed method achieves an accuracy of 0.9600, which is only 0.67% lower than that of supervised learning, while only requiring 20% of the labeled data. Therefore, the proposed method has great application prospects and can further promote the intelligent development of concrete vibration inspection.

Abstract:Effective vibration recognition can improve the performance of vibration control and structural damage detection and is in high demand for signal processing and advanced classification. Signal-processing methods can extract the potent time-frequency-domain characteristics of signals; however, the performance of conventional characteristics-based classification needs to be improved. Widely used deep learning algorithms（e.g., convolutional neural networks（CNNs）） can conduct classification by extracting high-dimensional data features, with outstanding performance. Hence, combining the advantages of signal processing and deep-learning algorithms can significantly enhance vibration recognition performance. A novel vibration recognition method based on signal processing and deep neural networks is proposed herein. First, environmental vibration signals are collected; then, signal processing is conducted to obtain the coefficient matrices of the time-frequency-domain characteristics using three typical algorithms: the wavelet transform, Hilbert–Huang transform, and Mel frequency cepstral coefficient extraction method. Subsequently, CNNs, long short-term memory（LSTM） networks, and combined deep CNN-LSTM networks are trained for vibration recognition, according to the time-frequencydomain characteristics. Finally, the performance of the trained deep neural networks is evaluated and validated.The results confirm the effectiveness of the proposed vibration recognition method combining signal preprocessing and deep learning.

Abstract:<p>Vibration quality is critical to ensure the concrete strength, which directly affects the long-term safe operation of concrete structures. The vibration duration and vibration depth are key parameters to guarantee vibration quality. However, traditional manual inspection on concrete surface to judge the vibration duration and estimation of vibration depth is subjective and unreliable. Moreover, existing studies monitor the vibration duration based on the knowledge from prior experiments, ignoring the influence of concrete heterogeneity. Thus, a real-time monitoring method for vibration quality of fresh concrete based on ResNet with 50 layers (ResNet-50) and Internet of Things (IoT) technology is proposed. The IoT-based monitoring framework is proposed to measure vibration depth and capture concrete surface image (CSI). A three-category classification model of CSI is established based on fine-tuned ResNet-50 model using a self-constructed dataset with 15,006 images to determine proper vibration duration. A large-scale hydraulic engineering application verifies the performance of the proposed method.</p>

Machine learning-enabled characterization of concrete mechanical strength through correlation of flexural and torsional resonance frequencies

Abstract:In this study, an assessment of concrete compressive strength was conducted using an impulse excitation data-driven machine learning (ML) framework. The model was constructed based on a deep neural network and aided by the backpropagation method, ensuring a precise training process. In contrast to prior research, which mainly focused on mixture components, a meaningful relationship between physical parameters—resonant frequencies and elastic moduli—and compressive strength was established by our ML model. Remarkable performance was demonstrated, with a root mean square error of 2.8% and a determination coefficient of 0.97. Through Pearson analysis, correlations between input features and output targets, ranging from -0.29 to 0.90, were revealed. Notably, the strongest correlations with compressive strength were found in Young's and shear moduli, derived from flexural and torsional frequencies, highlighting the pivotal role of dynamic elastic response in concrete's mechanical behavior. Furthermore, the findings indicated slight prediction deviations in cases involving samples with a high Poisson's ratio. This work illuminates the potential for accurate compressive strength prediction by leveraging concrete's dynamic response, particularly flexural and torsional modes, thereby opening avenues for research into concrete compressive strength without direct consideration of sample ingredients.

Abstract:The integration of advanced nanocomposites into concrete structures presents a promising avenue for enhancing their mechanical properties and durability. However, accurately predicting the vibrations of such structures remains a complex and challenging task due to the nonlinear behavior of the materials involved and the intricate interplay of various influencing factors. In this study, we propose the application of machine learning techniques as a powerful tool for estimating the vibrations of concrete structures reinforced with advanced nanocomposites. By leveraging the vast amounts of data generated from mathematical modeling, machine learning algorithms can effectively capture the intricate relationships between material properties, structural configurations, environmental conditions, and vibration responses. This article provides mathematical modeling simulation as the input of machine learning methods suitable for vibration prediction in concrete structures, including artificial neural networks. Furthermore, we discuss the key considerations and challenges associated with developing accurate and reliable machine learning models for this specific application domain, such as feature selection, model complexity, data quality, and interpretability. Through a comprehensive mathematical modeling, we highlight the potential of machine learning as a versatile and efficient tool for predicting vibrations in concrete structures reinforced with graphene oxide powders (GOPs). The integration of machine learning into the design, analysis, and maintenance of such structures not only facilitates more accurate predictions of vibration behavior but also enables proactive decision-making and optimization of structural performance. Finally, we outline future research directions and opportunities for further advancing the application of machine learning in the field of structural engineering and nanocomposite materials.

Abstract:Asa convenient and effective tool for monitoring of the structural behaviors of civil infrastructure, the machine vision-based sensing technology integrated with digital image processing algorithm has achieved great progress in the field of structural health monitoring (SHM). The prominent advantages of this kind of measurement technology mainly include non-contact, long-distance and high-resolution. Up to now, various types of vision-based systems have been developed and applied in structural performance monitoring of engineering structures, however, seldom investigations are relevant to monitoring of structural dynamic characteristics. In this paper, the method for multi-point synchronous measurement of structural dynamic displacement is proposed. The structural modal parameters are identified using measured multi-point dynamic displacements and fast Fourier transform. A simple-supported rectangle steel beam model is established for conducting experiments to investigate (i) comparison study on the measurement results obtained by the vision-based system and the accelerometer, (ii) the effect of the measurement distance on the accuracy of the vision-based system, and (iii) the feasibility of different types of targets (LED lamp and black spot). The experimental results show that the proposed vision-based method is effective, accurate and stable for structural dynamic response monitoring and modal parameter identification.
Real-time tracking of concrete vibration effort for intelligent concrete consolidation

Abstract:Proper consolidation of concrete is critical to the long-term strength of concrete structures. Vibration is a commonly used method to make concrete flowable and to remove the excessive entrapped air, therefore contributing to proper concrete consolidation. To introduce vibrations to freshly placed concrete, various tools such as internal vibrators are widely used in the construction industry. Producing a dense concrete without segregation with these tools requires an experienced vibrator operator. Inexperienced vibrator operators tend to over-consolidate or under-consolidate concrete. Many of these quality problems have their roots in the lack of quality control methods that can provide real-time feedback on the quality of concrete consolidation to vibrator operators. A real-time wireless sensing-based internal vibrator tip tracking system was developed and validated in this research to support intelligent concrete consolidation operations. More specifically, the research explored the use of an ultra wideband (UWB) tracking system to realize precise localization of the tip of an internal vibrator. A series of indoor and outdoor experiments are conducted to validate and model the tracking accuracy. A novel visualization program was developed to visualize operators' vibration effort in real-time. The program is capable of displaying vibration location and time in real-time. A vibrator operator can leverage such information to visualize the distribution of his vibration effort, and spot areas that may need mitigation actions. This also provides an innovative construction inspection practice to owners and resident engineers. The new concrete consolidation tool will allow contractors to proactively address concrete consolidation issues, a problem common to many concrete construction projects.

Abstract:In the process of construction, pouring and vibrating concrete on existing reinforced structures is a necessary process. This paper presents an automatic vibration position detecting method based on the feature extraction of 3D lidar point clouds. Compared with the image-based method, this method has better anti-interference performance to light with reduced computational consumption. First, lidar scans are used to capture multiple frames of local steel bar point clouds. Then, the clouds are stitched by Normal Distribution Transform (NDT) for preliminary matching and Iterative Closest Point (ICP) for fine-matching. The Graph-Based Optimization (g2o) method further refines the precision of the 3D registration. Afterwards, the 3D point clouds are projected into a 2D image. Finally, the locations of concrete vibration points and concrete casting points are discerned through point cloud and image processing technologies. Experiments demonstrate that the proposed automatic method outperforms ICP and NDT algorithms, reducing the mean square error (MSE) by 11.5% and 11.37%, respectively. The maximum discrepancies in identifying concrete vibration points and concrete casting points are 0.059 ± 0.031 m and 0.089 ± 0.0493 m, respectively, fulfilling the requirement for concrete vibration detection.

Abstract:Great progress has been made in the dynamic mechanical properties of concrete which is usually assumed to be homogenous. In fact, concrete is a typical heterogeneous material, and the meso-scale structure with aggregates has a significant effect on its macroscopic mechanical properties of concrete. In this paper, concrete is regarded as a two-phase composite material, that is, a combination of aggregate inclusion and mortar matrix. To create the finite element (FE) models, the Monte Carlo method is used to place the aggregates as random inclusions into the mortar matrix of the cylindrical specimens. To validate the numerical simulations of such an inclusion-matrix model at high strain rates, the comparisons with experimental results using the split Hopkinson pressure bar are made and good agreement is achieved in terms of dynamic increasing factor. By performing more extensive FE predictions, the influences of aggregate size and content on the macroscopic dynamic properties (i.e., peak dynamic strength) of concrete materials subjected to high strain rates are further investigated based on the back-propagation (BP) artificial neural network method. It is found that the particle size of aggregate has little effect on the dynamic mechanical properties of concrete but the peak dynamic strength of concrete increases obviously with the content increase of aggregate. After detailed comparisons with FE simulations, machine learning predictions based on the BP algorithm show good applicability for predicting dynamic mechanical strength of concrete with different aggregate sizes and contents. Instead of FE analysis with complicated meso-scale aggregate pre-processing, time-consuming simulation and laborious post-processing, machine learning predictions reproduce the stress–strain curves of concrete materials under high strain rates and thus the constitutive behavior can be efficiently predicted.

Abstract:In this study, the clustering method of the concrete matrix rupture and rubber fracture damages as well as the prediction of the ultimate load of crumb rubber concrete using the acoustic emission (AE) technique were investigated. The loading environment of the specimens was a four-point bending load. Six clustering methods including k-means, fuzzy c-means (FCM), self-organizing mapping (SOM), Gaussian mixture model (GMM), hierarchical model, and density peak clustering method were analyzed; the results illustrated that the density peak clustering has the best performance. Next, the optimal clustering algorithm was used to cluster AE signals so as to study the evolution behavior of different damage modes, and the ultimate load of crumb rubber concrete was predicted by an artificial neural network. The results indicated that the combination of AE techniques and appropriate clustering methods such as the density peak clustering method and the artificial neural network could be used as a practical tool for structural health monitoring of crumb rubber concrete.
Early-age concrete strength monitoring using smart aggregate based on electromechanical impedance and machine learning

Abstract:It is crucial to monitor the real-time strength development of early-age concrete, which is related to the structure safety and construction efficiency of concrete. This paper proposed a new method to predict and monitor concrete strength development. The basic idea is using embedded smart aggregates (SAs), combining the electromechanical impedance (EMI) technology and machine learning to monitor the strength development of early-age concrete. An EMI model of the embedded SA was firstly established and the relationship between the conductance resonant frequency (CRF) and conductance resonant peak (CRP) of the SA and the development of concrete strength was investigated. The conductance signatures were continuously monitored and the compressive strength of the specimens at different ages was tested. Hence, the EMI model results that the CRF decreases but CRP increases as the compressive strength of concrete increases were verified by analyzing the collected data. The four different models of a linear regression model (LR), a convolutional neural network (CNN), a hybrid (LR-CNN) model, and an empirical equation were established. The conductance of SAs as the developed models inputs, the compressive strength of specimens as outputs. Finally, these four models were compared with each other. Meanwhile, the performance indicators of the LR-CNN model and other hybrid models were compared. The results show that the LR-CNN model has excellent performance and successfully achieves quantitative prediction of concrete strength development. The proposed method for evaluating and predicting the compressive strength of concrete is simple, accurate, quantitative and reliable, and has promising application.

Abstract:The vibration of concrete is a typical concealed construction process, in which mature supervisory methods are lacking. The quality of vibration relies heavily on the subjective experience and sense of responsibility of the vibration operators. For the widely used hand-held concrete vibrators, existing methods for monitoring the quality of vibration primarily focus on the horizontal positioning of the vibrator. Due to the limited measurable range of vibration depth, these methods are inapplicable for monitoring the vibration depth during the vibration of deeper structures such as walls, columns, and large volumes of concrete. This paper makes the initial attempt to address the issue of monitoring concrete vibration depth, presenting a method that broadens the measurable range of depth in vibration monitoring. Inspired by the principles of optical and magnetic scales, this paper introduces a radio frequency identification (RFID) scales positioning system for the real-time monitoring of vibration depth. The proposed RFID scales vibration depth monitoring method theoretically has no upper limit on the measurable vibration depth, rendering it applicable to monitoring vibration depth of any extent. By comparing the positioning accuracy of different RFID scales hardware compositions, the optimal RFID scales hardware composition and the most effective RFID scales positioning algorithm were identified. The feasibility and accuracy of the vibration depth monitoring method based on RFID scales were validated through engineering field application. This method achieves centimeter-level accuracy in monitoring vibration depth, offers a tool for the precise control of vibration depth, and helps avoid potential quality issues in vibration.

Classification of cracking sources of different engineering media via machine learning

Abstract:<p>Complex civil structures require the cooperation of many building materials. However, it is difficult to accurately monitor and evaluate the inner damage states of various material systems. Based on a convolutional neural network (CNN) and the acoustic emission (AE) time-frequency diagram, we used the transfer learning method for classifying the AE signals of different materials under external loads. The results show the CNN model can accurately classify cracks that come from different materials based on AE signals. The recognition accuracy can reach 90% just by retraining the full connection layer of the pretrained model, and its accuracy can reach 97% after retraining the top 2 convolutional layers of this model. A realization of cracking source identification mainly depends on the differences in mineral particles in materials. This work highlights the great potential for real-time and quantitative monitoring of the health status of composite civil structures.</p>

Abstract:This paper proposes a pipeline to automatically track and measure displacement and vibration of structural specimens during laboratory experiments. The latest Mask Regional Convolutional Neural Network (Mask R-CNN) can locate the targets and monitor their movement from videos recorded by a stationary camera. To improve precision and remove the noise, techniques such as Scale-invariant Feature Transform (SIFT) and various filters for signal processing are included. Experiments on three small-scale reinforced concrete beams and a shaking table test are utilized to verify the proposed method. Results show that the proposed deep learning method can achieve the goal to automatically and precisely measure the motion of tested structural members during laboratory experiments.

Abstract:In response to the data anomalies and frequent false alarms caused by harsh environments in long‐term structural health monitoring (SHM), this study has reframed the detection of abnormal vibration data as a time series classification problem. This approach identifies multiple anomalous features, thereby reducing manual detection costs. The novel developed Convolutional Neural Network with Squeeze‐and‐Excitation and Multi‐Head Self‐Attention (CNN–SE–MHSA) employs a deep residual network structure with channel and spatial attention mechanisms, effectively handling the global long‐term dependencies required for anomaly feature learning. It better understands and utilizes feature information across different levels and dimensions, enhancing classification accuracy in complex anomaly situations. Through t‐SNE dimensionality reduction visualization and interpretability analysis, it is demonstrated that the model excels in identifying critical features. Furthermore, by generating simulated data with a variational autoencoder (VAE) and implementing transfer learning strategies based on these data, the issue of low recognition accuracy for complex anomaly data due to data imbalance can be effectively mitigated. In a 25‐day long‐term monitoring experiment of indoor tunnel lining structures, this method demonstrated an average accuracy rate exceeding 96% and a rapid detection capability within 16 min. The results indicate that this method achieves high accuracy in anomaly detection for long‐term monitoring data, even when relying exclusively on time‐domain data.

Abstract:Passive control is typically implemented to regulate ground vibration in advanced ultra-precision and large-scale synchrotron radiation facilities. This paper presents the field test to evaluate the influence of cracks on the vibration control capacity of a mass concrete layer used as a passive control method of an advanced synchrotron radiation facility. Simplified finite element model (FEM) analysis is utilized to simulate the cracks and analyze the key factor that influences the vibration control capacity of the mass concrete layer. In the field test, cracks are artificially formed by creating cuts in two orthometric directions on the surface of a 3-m-thick concrete layer. Measurement points and a vibrator capable of generating simple harmonic excitation (1–100 Hz) are positioned along a straight line. Velocity signals vertical to the ground are obtained to study the vibration attenuation in the vertical direction. Test results indicate that the velocity signals on the concrete layer are sensitive to the cracks; the vibration control ability of the concrete layer is slightly affected by the depth, length and location of the cracks in the frequency band of 1–100 Hz. The proposed simplified FEMs can reflect the cracked concrete layer's vibration control ability from 1 to 100 Hz. Numerical study results indicate that the thickness of the concrete layer rather than the density or elastic modulus is the key factor in vibration control ability.
