Abstract:Spiking neural networks (SNNs) with bio-inspired spatio-temporal dynamics, have increasingly manifested their superiority in energy efficiency. However, the non-differential spiking activity hinders the implementation of the efficient error backpropagation in training SNNs. The existing solution circumvents this problem by a relaxation on the gradient calculation using a continuous function, which is referred to as surrogate gradient learning. Nevertheless, such a solution leads to a prominent gradient mismatch problem due to the low precision of spikes, which limits the performance of directly trained SNNs on deeper architectures. To tackle this issue, we propose the adaptive multilevel firing (AMLF) method incorporating the spiking dormant-suppressed residual network (spiking DS-ResNet) to get well-behaved SNNs. The AMLF method can not only adaptively implement incremental expression ability of spiking neurons to alleviate gradient mismatch issue, but also enable more efficient gradient propagation during training by enlarging the gradient-available area. We conduct a series of experiments on static image datasets and neuromorphic datasets. Results show that the proposed AMLF method can help SNNs achieve competitive performance in terms of both latency and accuracy.

Abstract:In Brain-Machine Interfaces, the redudancy among neuron activities can decrease the generalization of a decoding model and increase computation complexity. This study proposes a novel algorithm based on symmetrical uncertainty that optimally selects neurons to decode kinetic variables. In this algorithm, both relevance and redundancy are considered. We tested the method by decoding spike train data recorded from a monkey using support vector regression. The results of extensive experiments show that only 15% of the recorded neurons can achieve a decoding performance comparable to using all neurons. The generalization of the selected neurons is no worse than using all neurons either. In addition, we have also compared our method with the traditional mutual information method and shown that the neurons selected by our method are less redundant. © 2013 Springer-Verlag.
Towards free-response paradigm: a theory on decision-making in spiking neural networks

Abstract:The energy-efficient and brain-like information processing abilities of Spiking Neural Networks (SNNs) have attracted considerable attention, establishing them as a crucial element of brain-inspired computing. One prevalent challenge encountered by SNNs is the trade-off between inference speed and accuracy, which requires sufficient time to achieve the desired level of performance. Drawing inspiration from animal behavior experiments that demonstrate a connection between decision-making reaction times, task complexity, and confidence levels, this study seeks to apply these insights to SNNs. The focus is on understanding how SNNs make inferences, with a particular emphasis on untangling the interplay between signal and noise in decision-making processes. The proposed theoretical framework introduces a new optimization objective for SNN training, highlighting the importance of not only the accuracy of decisions but also the development of predictive confidence through learning from past experiences. Experimental results demonstrate that SNNs trained according to this framework exhibit improved confidence expression, leading to better decision-making outcomes. In addition, a strategy is introduced for efficient decision-making during inference, which allows SNNs to complete tasks more quickly and can use stopping times as indicators of decision confidence. By integrating neuroscience insights with neuromorphic computing, this study opens up new possibilities to explore the capabilities of SNNs and advance their application in complex decision-making scenarios.

Abstract:Abstract It has been evidenced that vision-based decision-making in Drosophila consists of both simple perceptual (linear) decision and value-based (non-linear) decision. This paper proposes a general computational spiking neural network (SNN) model to explore how different brain areas are connected contributing to Drosophila linear and nonlinear decision-making behavior. First, our SNN model could successfully describe all the experimental findings in fly visual reinforcement learning and action selection among multiple conflicting choices as well. Second, our computational modeling shows that dopaminergic neuron-GABAergic neuron-mushroom body (DA-GABA-MB) works in a recurrent loop providing a key circuit for gain and gating mechanism of nonlinear decision making. Compared with existing models, our model shows more biologically plausible on the network design and working mechanism, and could amplify the small differences between two conflicting cues more clearly. Finally, based on the proposed model, the UAV could quickly learn to make clear-cut decisions among multiple visual choices and flexible reversal learning resembling to real fly. Compared with linear and uniform decision-making methods, the DA-GABA-MB mechanism helps UAV complete the decision-making task with fewer steps.

Abstract:Biological systems can exhibit intelligent swarm behavior through relatively independent individual, local interaction and decentralized decision-making. A major research challenge of self-organized swarm intelligence is the coupling influences between individual behaviors. Existing methods optimize the behavior of multiple individuals simultaneously from a global perspective. However, these methods lack in-depth inspiration from swarm behaviors in nature, so they are short of flexibly adapting to real multi-robot online decision-making tasks. To overcome such limits, this paper proposes a self-organized collision avoidance model for real drones incorporating a bio-inspired reward-modulated spiking neural network (RSNN). The local interaction and autonomous learning of a single individual leads to the emergence of swarm intelligence. We validated the proposed model on swarm collision avoidance tasks (a swarm of unmanned aerial vehicles without central control) in a bounded space, carrying out simulation and real-world experiments. Compared with artificial neural network-based online learning methods, our proposed method exhibits superior performance and better stability.

Abstract:Automatic responses enable us to react quickly and effortlessly, but they often need to be inhibited so that an alternative, voluntary action can take place. To investigate the brain mechanism of controlled behavior, we investigated a biologically-based network model of spiking neurons for inhibitory control. In contrast to a simple race between pro- versus anti-response, our model incorporates a sensorimotor remapping module, and an action-selection module endowed with a "Stop" process through tonic inhibition. Both are under the modulation of rule-dependent control. We tested the model by applying it to the well known antisaccade task in which one must suppress the urge to look toward a visual target that suddenly appears, and shift the gaze diametrically away from the target instead. We found that the two-stage competition is crucial for reproducing the complex behavior and neuronal activity observed in the antisaccade task across multiple brain regions. Notably, our model demonstrates two types of errors: fast and slow. Fast errors result from failing to inhibit the quick automatic responses and therefore exhibit very short response times. Slow errors, in contrast, are due to incorrect decisions in the remapping process and exhibit long response times comparable to those of correct antisaccade responses. The model thus reveals a circuit mechanism for the empirically observed slow errors and broad distributions of erroneous response times in antisaccade. Our work suggests that selecting between competing automatic and voluntary actions in behavioral control can be understood in terms of near-threshold decision-making, sharing a common recurrent (attractor) neural circuit mechanism with discrimination in perception.

Abstract:The unmanned aerial vehicle (UAV) has emerged unexpectedly as a new force in the recent local wars. To occupy the high ground of military technology in the future, research on autonomous air combat using UAVs is extremely important. In this paper, we propose an intelligent air combat learning system inspired by the cognitive mechanism of the human brain. The air combat capability was divided into two parts: declarative and procedural memory. Imitating the updating and storage mechanism of human knowledge, a long- and short-term hierarchical asynchronous learning principle was designed. We adopted the basic idea of using the error signal to drive learning according to neurophysiological research. Drawing lessons from the working memory mechanism, the error signal for driving the short-term learning was created in the absence of labelled data, using only the interactive information. Then, we proved that the learning mechanism could ensure that system performance advances steadily and gradually. The experiments illustrated that the learning system designed in this paper can achieve some inferior confrontation ability through self-learning without human prior knowledge. Action strategies formed by learning are analogous to the classical tactical manoeuvres of human fighter pilots. We compared our work with related works and found that our method could improve its performance continuously and finally defeat its opponent.
