Abstract:Three estimation models of polypropylene (PP) process to infer the melt index, an important quality indicator determining product specification, are presented. Radial basis function (RBF) neural network (NN) is used to develop the models because of its capacity of fitting the complex relationship in PP process. A novel ant colony optimization (ACO) algorithm is also proposed and used to solve the optimization problem of the continuous linking weights when training the RBF NN. Based on the RBF NN and the novel ACO algorithm, a single NN model is developed. However, a single network cannot always work well due to some defects (such as overfitting) of a NN. Thus, as an improvement of the single NN model, several RBF NN trained with a certain objective are combined, and the aggregated NN model is obtained. To make the aggregated NN more robust and effective, an adaptive method of assigning the combinational weight to every individual network is applied to the former aggregated NN model and finally an adaptive aggregated NN model is achieved. Further researches of the three models are carried out on the data from a real industrial plant, and the prediction result shows that the performance of the obtained prediction models is better and better with every improvement step taken as above. The adaptive aggregated NN model works best, and the satisfying prediction error it provides depicts its prediction accuracy and universality, as well as an application prospect in PP process. Abstract:In the propylene polymerization process, the melt index (MI), as a critical quality variable in determining the product specification, cannot be measured in real time. What we already know is that MI is influenced by a large number of process variables, such as the process temperature, pressure, and level of liquid, and a large amount of their data are routinely recorded by the distributed control system. An alternative data-driven model was explored to online predict the MI, where the least squares support vector machine was responsible for establishing the complicated nonlinear relationship between the difficult-to-measure quality variable MI and those easy-to-measure process variables, whereas the independent component analysis and particle swarm optimization technique were structurally integrated into the model to tune the best values of the model parameters. Furthermore, an online correction strategy was specially devised to update the modeling data and adjust the model configuration parameters via adaptive behavior. The effectiveness of the designed data-driven approach was illustrated by the inference of the MI in a real polypropylene manufacturing plant, and we achieved a root mean square error of 0.0320 and a standard deviation of 0.0288 on the testing dataset. Abstract:Accurate and reliable quality index prediction is indispensable in quality control of the industrial propylene polymerization (PP) processes. This paper presents a novel modeling approach for quality index prediction based on optimal fuzzy wavelet neural network (FWNN) with improved gravitational search algorithm (IGSA), where the constant or a linear function of inputs in conclusion part of traditional TSK fuzzy model is replaced with wavelet neural network (WNN). Then, an online learning algorithm of the FWNN model is derived by using gradient descent algorithm, and an IGSA algorithm is proposed to online adapt the learning rates of FWNN. Research on the proposed soft sensor is carried out with the data from a real industrial PP plant, and the results are compared among the WNN, FWNN and IGSA-FWNN models. The research results show that the proposed prediction model achieves a good performance in practical industrial quality index, melt index, prediction process.

Abstract:A novel real-time soft sensor based on a sparse Bayesian probabilistic inference framework is proposed for the prediction of melt index in industrial polypropylene process. The Bayesian framework consists of a relevance vector machine for predicting melt index and a particle filtering algorithm for soft sensor optimization. An online correcting strategy is also developed for improving the performance of real-time melt index prediction. The method takes advantages of the probabilistic inference and using prior statistical knowledge of polymerization process. Developed soft sensors are validated with ten public databases from UCI machine learning repository and real data from industrial polypropylene process. Experimental results indicate the effectiveness of proposed method and show the improvement in both prediction precision and generalization capability compared with the reported models in literatures. Abstract:In the real-time propylene polymerization manufacturing process, melt index (MI), as the key product quality variable, is hard to be measured on-line, which brings difficulties to the control and optimization of this process. However, a large amount of data of other relative process variables in this process can be routinely recorded online by the distributed control system (DCS). An optimal soft-sensor of least squares support vector machine (LS-SVM) is therefore proposed to implement the on-line estimation of MI with the above real-time DCS records, where LS-SVM is employed for developing a data-driven model of the above industry process. In view of that the input variable selection and parameter setting are crucial for the learning results and generalization ability of LS-SVM, the nonlinear isometric feature mapping technique and particle swarm optimization algorithm are then structurally integrated into the model to search the optimal values of those parameters. Considering the process time-varying nature, an online correction strategy is further switched on to update the modeling data and revise the model configuration parameters via adaptive behavior. Finally, the explored soft sensor model is illustrated with a real plant of propylene polymerization, and the results show the predictive accuracy and validity of the proposed systematic approach.

Reliable prediction of the MI is significant in practical propylene polymerization (PP) processes. This paper presents novel predictive fuzzy functions (FF), combining the particle swarm optimization (PSO) algorithm and weighted least squares support vector machines (WLS-SVM) to infer MI from real PP process variables, where the FF utilize WLS-SVM for regression models to calculate the parameters and the PSO algorithm further optimizes the model. Research on the proposed FF model is carried out with the data from a real PP plant and the results are compared among the standard SVM, FF-LS-SVM, FF-WLS-SVM, and PSO-FF-WLS-SVM models. The results show that the model developed here can be a powerful tool for online MI prediction.

Abstract:In propylene polymerization (PP) process, the melt index (MI) is one of the most important quality variables for determining different brands of products and different grades of product quality. Accurate prediction of MI is essential for efficient and professional monitoring and control of practical PP processes. This paper presents a novel soft sensor based on extreme learning machine (ELM) and modified gravitational search algorithm (MGSA) to estimate MI from real PP process variables, where the MGSA algorithm is developed to find the best parameters of input weights and hidden biases for ELM. As the comparative basis, the models of ELM, APSO-ELM and GSA-ELM are also developed respectively. Based on the data from a real PP production plant, a detailed comparison of the models is carried out. The research results show the accuracy and universality of the proposed model and it can be a powerful tool for online MI prediction.

Abstract:Online measurement of the melt index is typically unavailable in industrial polypropylene production processes, soft sensing models are therefore required for estimation and prediction of this important quality variable. Polymerization is a highly nonlinear process, which usually produces products with multiple quality grades. In the present paper, an effective soft sensor, named combined local Gaussian process regression (CLGPR), is developed for prediction of the melt index. While the introduced Gaussian process regression model can well address the high nonlinearity of the process data in each operation mode, the local modeling structure can be effectively extended to processes with multiple operation modes. Feasibility and efficiency of the proposed soft sensor are demonstrated through the application to an industrial polypropylene production process.

Abstract:In recent years, more and more attention has been attracted by fine denier polyester fibers in electronic information industry due to their unique structural and excellent mechanical properties. As known, the mechanical properties of fine denier polyester fibers have a close relationship with their melt-spinning process parameters, thus, it is worth further exploring the influence of process parameters on fiber mechanical properties (namely breaking strength, elongation at break and CV of breaking strength). This study aims to develop a novel prediction model based on the artificial neural network (ANN) to predict the key mechanical properties of fine denier polyester fibers. For this purpose, firstly, different specifications of fine denier polyester fibers with different mechanical properties are produced by adjusting the key melt-spinning parameters, namely spinning temperature, take-roll speed and metering pump speed. Then the experimental data is collected, analyzed and augmented with effect to be used for modeling. Next, a novel prediction model based on ANN is developed by importing the two-streams structure and two attention matrices to improve the feature abstraction for mechanical properties prediction. Lastly, different predictive performance indicators, namely root mean square error (RMSE), mean absolute percent error (MAPE) and the coefficient of determination (R 2 ) are imported to evaluate the proposed model. For the total of three mechanical properties, the predicted results of the proposed model in terms of RMSE, MAPE and R 2 are respectively 0.3499, 0.0906 and 2.9516.

Abstract:Electrospinning is a manufacturing technique that can produce microfibers and nanofibers from polymeric solutions. It has a broad range of applications in areas such as tissue engineering, flexible electronics, filtering, etc. However, due to its chaotic behavior, the fibers obtained by this process are prone to high diameter variations. The high diameter variations will cause poor final product functionality. The diameter is affected by process variables, ambient conditions and in-situ measurements. It is therefore important to model their effect on the fiber diameter variation, which is rarely investigated in the literature. Towards this end, this paper systematically studies the electrospinning process of a biocompatible polymer (i.e., polyacrylonitrile (PAN) 10%) via experimental study and data-driven modeling. In particular, three critical process variables (i.e., voltage, tip-to-collector distance, and polymer flow rate), are varied in a central composite design of experiment. Twenty-four runs are executed for the data collection, during which the in-situ measurements are collected via a customized sensing system. After each experiment, scanning electron microscope (SEM) images are taken from the nonwoven mats and characterized to capture the diameter and the diameter variations. Three machine learning methods, Lasso, random forest (RF), and support vector machine (SVM), are applied to the collected data. The model performance is evaluated in the real case study on the electrospinning ofpolymeric solution. The most predictive model (RF) can yield an around 15% relative error for prediction in testing data on average over 100 replications.

This study aims at determining the optimal material and process parameters that will maximize the quality characteristics of miscanthus fiber-reinforced polypropylene (MFRPP) composite. Taguchi L16 was utilized in the design of experiment and larger-the-better signal-to-noise ratio was used in the analysis of the impact strength of MFRPP. Optimal combination of material and process parameters and the main effects were determined, and the significant variables were identified using analysis of variance. Artificial neural network (ANN) and extreme learning machine (ELM) were utilized on the Taguchi experimental data and used in the prediction of the impact strength of MFRPP. The results showed the optimum impact strength occurred at 25 wt% miscanthus fiber loading. The results of the predictions made revealed that both ANN and ELM are very efficient in predicting the impact strength of MFRPP as shown by the relative errors when compared with the experimental data. Both the performance metrics assessments and the quality of prediction show that ELM is a better machine learning technique than ANN. The high impact strength of MFRPP composite is a confirmation that MFRPP is a very useful material for industrial applications.

Abstract:An artificial neural network model is established for predicting the fiber diameter of melt blown nonwoven fabrics from the processing parameters. An attempt is made to study the effect of the number of hidden layers and hidden layer neurons to minimize the prediction error. The artificial neural network with three hidden layers (5, 2, and 3 neurons in the first, second, and third hidden layer, respectively) yields the minimum prediction error and thus is determined as the preferred network. The square of the correlation coefficient of measured and predicted fiber diameters shows the good performance of the model. Using the established ANN model, computer simulations of the effects of the processing parameters on the fiber diameter are carried out. The results show great promise for this research in the field of computer assisted design of melt blowing technology. (c) 2005 Wiley Periodicals, Inc.

Abstract:In this study, polyvinylpyrrolidone ultrafine fibers were produced by the Forcespinning process. As the functional performance of forcespun fibers is strongly dependent on their diameter, response surface methodology and artificial neural network combined with principal component analysis were applied, for the first time in this study, to predict the relationships between fiber diameter and a set of combined chemical, environmental and spinning parameters. With this aim in view, 40 sets of Forcespinning trials were performed by combining six main variables, namely: solution concentration, syringe orifice size, relative humidity rate, ambient temperature, rotational speed and collection distance. The collected samples appeared as a random network of smooth fibers with a mean fiber diameter ranging from 461 nm to 8.978 μm. Interestingly, the optimized neural network consisting of six input variables, five hidden layers with ten neurons and one output layer exhibited the best prediction accuracy, thereby providing a remarkable Mean Squared Error of 0.0498 and a correlation coefficient of 0.9954, between observed and predicted fiber diameter. Additionally, 3D plots of ANN computed data, allowed pointing out mutual interactions between effects of chemical, spinning and environmental parameters, in relation to fiber diameter. Furthermore, principal component analysis conducted on ANN computed data, enabled classifying the contribution of each parameter as follows: solution concentration, followed by syringe orifice size, relative humidity rate, ambient temperature, rotational speed and collection distance. These findings demonstrate, for the first time, the key role of environmental parameters in the Forcespinning process.

Mathematical Modeling of Polypropylene Quality for Spheripol Process

Abstract:The prediction of the melt index and ethylene content for polypropylene (PP) was investigated, and both of them are the key quality index of PP production. Aimed at the Spheripol technology and based on the polymerization kinetic mechanism of Ziegler-Natta (Z-N) catalyst, the mathematical models of melt index and ethylene content were established respectively for the predictions of melt index and ethylene content of the polypropylene products with different grades including the homo-PP, random copolymer of propylene-ethylene and impact poly(ethylene-propylene). The dynamic production data from an industry plant were used for the fitting of the models proposed, and from which the parameters of the models were obtained. The results show that using the models proposed, the average relative errors between the model prediction and the practical analysis are 3.86% for melt index and 13.5% for ethylene content, respectively, which indicates that the models proposed can be used in industrial plants to predict the quality of the PP products accurately and can be a great help to the soft-sensor design and the optimization of grade transition.

Abstract:Reliable estimation of melt index (MI) is crucial for the production of polypropylene. Propylene polymerization process is highly nonlinear and characterized by multi-scale nature with lots of variables and information that are highly correlated and derived at different sample rates from different sensors. A novel soft-sensor architecture based on radial basis function networks (RBF) combining independent component analysis (ICA) as well as multi-scale analysis (MSA) is proposed to infer the MI of polypropylene from other process variables. In the proposed model, ICA is carried out to select the most independent process features and to eliminate the correlations of the input variables, MSA is introduced to acquire approximate and detailed scale information of the process and make the model more robust to mismatches, and RBF networks are used to characterize the nonlinearity in every scale. The approach is evaluated and the results are compared with simplified approaches built with the same data set. The research results confirm the validity of the proposed model.

Abstract:Firstly, the effects of the spinning temperature, spinning voltage, tip-to-collector distance and ambient temperature on the diameter of melt-electrospinning polypropylene (PP) fibers were studied. The results showed that with the increase of the spinning temperature, spinning voltage and tip-to-collector distance, the fiber diameters first decreased and then increased. However, when the ambient temperature increased, the fiber diameters increased gradually. Secondly, based on the previous results, the response surface methodology (RSM) was used to investigate the combined effects of processing parameters on fiber diameters and establish a second-order polynomial equation to predict the fiber diameter. The results showed that the effect order of four factors on fiber diameter was as follows: spinning temperature > tip-to-collector distance > ambient temperature > spinning voltage. Moreover, the fiber diameter predicted by response surface analysis fitted well with the experimental result. Abstract:Reliable prediction of melt index (MI) is crucial in practical propylene polymerization processes. In this paper, a least squares support vector machines (LS-SVM) soft-sensor model is developed first to infer the MI of polypropylene from other process variables. A weighted least squares support vector machines (weighted LS-SVM) approach is further proposed to obtain rather robust estimate. Detailed comparative researches are carried out among standard SVM, LS-SVM, and weighted LS-SVM. The research results confirm the effectiveness of the presented methods.

Abstract:Melt index(MI) is the most important parameter in determining the polypropylene's grade.Since the lack of proper on-line instruments,its measurement interval and delay are both very long.This makes the quality control quite difficult.A neural network model based on PCA-GA-RBF was proposed to infer the MI of manufactured products from real process variables,where principle component analysis(PCA) was used to select the most relevant process features and to eliminate the correlations of the input variables,radial basis function(RBF) neural networks were used to characterize the nonlinearity and accuracy,and genetic algorithms(GA) was employed to optimize the parameters and structure of the RBF neural networks.The results show that the proposed method provides promising prediction reliability and accuracy.

To address the problem of quality optimization of multi-correlation parameters in the spinning process, this paper proposes a new method based on a sparrow search algorithm (SSA). Firstly, a generalized regression neural network (GRNN) is used to investigate the impact of the spinning process parameters on yarn quality, and quality forward modeling in the spinning process is established. And based on the coupling and correlation characteristics of spinning process parameters, sensitivity analysis is used to analyze the influence of each spinning process parameter on yarn quality, the correlation spinning process parameters for further analysis. Then a model of quality optimization with spinning process parameters is established, and SSA is used to solve the model of quality optimization with multi-correlation parameters in the spinning process. Finally, the effectiveness of the proposed method was validated through an instance. The results show that the optimal spinning process parameters combination generation of [32.159 5.2 0.8 14.8 24.540 8588.677 21.708] occurs in a configuration with a fitness value of 0.0003. The proposed sensitivity analysis-based quality optimization strategy reveals good performances in terms of both convergence speed and optimization accuracy, which will provide guidance for improving yarn quality.

Abstract:<p>In the present work, we developed an artificial neural networks (ANN) model to predict and analyze the polycaprolactone fiber diameter as a function of 3D melt electrospinning process parameters. A total of 35 datasets having various combinations of electrospinning writing process variables (collector speed, tip to nozzle distance, applied pressure, and voltage) and resultant fiber diameter were considered for model development. The designed stand‐alone ANN software extracts relationships between the process variables and fiber diameter in a 3D melt electrospinning system. The developed model could predict the fiber diameter with reasonable accuracy for both train (28) and test (7) datasets. The relative index of importance revealed the significance of process variables on the fiber diameter. Virtual melt spinning system with the mean values of the process variables identifies the quantitative relationship between the fiber diameter and process variables.</p>
