Abstract:In recent years, Unmanned Aerial Vehicles (UAVs) have been increasingly popularized across various fields, posing security challenges that necessitate effective detection methods. Most existing radio frequency (RF)-based UAV detection methods are data-driven, whose performance can be limited by the factors such as incomplete datasets, hardware constraints, etc. In this regard, we propose a data-free UAV detection method by analyzing the periodicity of UAV signals in this paper. First, the short-time Fourier transform is employed to cast the originally captured signals into the time-frequency domain, where both the image transmission signal (ITS) and the flight control signal (FCS) of UAVs can be extracted. Then, the signal encodings of both ITS and FCS are developed by evaluating energy accumulations with the specially designed sliding window functions. As such, the Pearson correlation coefficients of UAV signals among different time segments can be calculated to assess the periodicity of ITS and FCS, which can be utilized for UAV detection. The proposed method eliminates the necessity for extensive prior knowledge of UAV signal datasets, encompassing bandwidth, duration, and frequency details. Moreover, we implement our methodology on a Field-Programmable Gate Array (FPGA), underscoring its practical applicability, and the experiments are carried out to demonstrate the superior performance of the proposed method as compared to the deep learning-based methods.

Abstract:With the development of science and technology, unmanned aerial vehicle (UAV) is more and more widely used to bring a lot of convenience to the society, but also led to serious threats to public security, personal privacy, military security and other aspects. Therefore, it is increasingly important to find unknown drones quickly and accurately. In UAV detection, the technologies based on acoustic, radio and radar detection are common, but these technologies usually require expensive equipment and strict configuration. However, the method based on machine vision has the advantages of low cost and simple configuration. In addition, detection and recognition methods based on deep learning have been fully developed, but most of them are for a single visible image, and the detection and recognition effect is limited. In this paper, a fast detection and identification method based is proposed based on the backbone of YOLOv3 (You Only Look Once version3). And dual-channel detectors were used as data sources. In this method, infrared and visible images are simultaneously input into the network for feature extraction, and the extracted depth features are concatenated. Then the multi-scale prediction network is used to regression the target location to obtain the final detection and recognition results. Finally, by collecting real UAV data sets, the network is trained and tested for comparative experiments. Experimental results show that the mAP of method in this paper is worthy of improvement, and the detection speed remains at 27images/s.

Abstract:Due to cost reduction and device miniaturization, amateur drones are now widely used in numerous civilian and commercial applications. However, the abuse of amateur drones has resulted in emerging threats to personal privacy and public security. To alleviate these threats, we design an acoustic-based surveillance system, which can achieve the capacity of amateur drones detection and localization with 24/7 (24 hours per day and 7 days per week under normal circumstances) availability. In the designed system, a detection fusion algorithm and a TDOA estimation algorithm based on the Bayesian filter are applied to improve the performance of drone detection and localization. Field experiments are carried out, and the results demonstrate that the designed system can detect and locate an amateur drone in real time with high accuracy and 24/7 availability.

Abstract:The rapid development of unmanned aerial vehicle (UAV) market presents potential threats to public security and personal privacy, and the vision sensors are widely deployed to detect the invasive UAVs because of the intuitivity and accessibility of the video. However, the small pixel area and weak morphological characteristics of distant invasive UAVs pose a considerable challenge to the detection precision. Prior work on UAV detection simply focuses on the information fusion between different feature layers, but ignoring the feature information inside each layer. In addition, to detect small UAV in video streams, the motion information of the target is also a noteworthy feature. In this regard, we propose a feature super-resolution-based UAV detector with motion information extractor. The proposed network fully utilizes the motion information of UAVs between temporal frames and the spatial invariant features between different resolution frames to pursue a high-accuracy small UAV detection performance. Experiments on Drone vs Birds dataset are carried out, and it is demonstrated that a higher detection accuracy on small UAVs is achieved compared with the baseline.

Abstract:The utilization of unmanned aerial vehicles (UAVs) is progressively expanding, thereby introducing novel risks to public safety and even the battlefield environment. Consequently, it becomes imperative to detect noncooperative UAVs. The employment of UAV sound signals for identifying nearby UAVs has garnered significant attention due to its comprehensive coverage, independence from obstructions such as trees and cost-effectiveness. However, practical implementation is hindered by the rapid attenuation of sound, limited acquisition range, and insufficient sound dataset. Therefore, urgent research is required on the generation and propagation of UAV sounds in order to enhance sensor performance and signal processing algorithms while enriching the available UAV sound dataset. This article analyzes the time-frequency characteristics of UAV sound generation and propagation. On this basis, a low-frequency acoustic sensitive acoustic sensor based on piezoelectric ceramic double vibrator is adopted. The sensor has an amplification effect on the low-frequency high-energy signals emitted by UAV, and the detection distance reaches 500 m. Then, UAV sound datasets at different altitudes are collected, and a sparse Mayer filter is designed to generate the time–frequency feature map. In order to reduce the influence of environmental noise, vehicle noise, bird chirp, rain, and other environmental sounds are collected as negative samples. The deep residual network is used to train and identify UAV sounds, and the accuracy of the test set reaches 99.7%. This system can accurately identify whether there is a UAV in the range of 500 m, which has important value in the field of security and other fields.

Abstract:The evolution of Unmanned Aerial Vehicles (UAVs) technology has made these devices suitable for a wide new range of applications, but it has also raised safety concerns as UAVs can be used for carrying explosives or weapons with malicious intentions. In this paper, Machine Learning (ML) algorithms are used to identify UAVs by using the sound signals they emit. We evaluate and propose a feature-based classification. Five individual features, and one combination of features are used to train four machine learning classification approaches: a neural network (NN), a support vector machine (SVM), a Gaussian Naive Bayes (GNB), and K-Nearest Neighbor (KNN). The training and testing dataset is composed of sound samples of UAVs and noise. The labels in the dataset we collected include the sound files of noise and UAVs. The results show that the combination of features outperforms the individual ones, with higher average accuracy scores.
Development of an Acoustic System for UAV Detection

Abstract:The purpose of this paper is to investigate the possibility of developing and using an intelligent, flexible, and reliable acoustic system, designed to discover, locate, and transmit the position of unmanned aerial vehicles (UAVs). Such an application is very useful for monitoring sensitive areas and land territories subject to privacy. The software functional components of the proposed detection and location algorithm were developed employing acoustic signal analysis and concurrent neural networks (CoNNs). An analysis of the detection and tracking performance for remotely piloted aircraft systems (RPASs), measured with a dedicated spiral microphone array with MEMS microphones, was also performed. The detection and tracking algorithms were implemented based on spectrograms decomposition and adaptive filters. In this research, spectrograms with Cohen class decomposition, log-Mel spectrograms, harmonic-percussive source separation and raw audio waveforms of the audio sample, collected from the spiral microphone array-as an input to the Concurrent Neural Networks were used, in order to determine and classify the number of detected drones in the perimeter of interest.
Acoustic Detection of Drones through Real-time Audio Attribute Prediction

Abstract:With the rise in popularity of drones, their use in anti-social activities has also proliferated. Nationwide police increasingly report the appearance of drones in unauthorized settings such as public gatherings and also in the delivery of contraband to prisons. Detection and classification of drones in such environments is very challenging from both visual and acoustic perspective. Visual detection of drones is challenging due to their small size. There may be cases where views are obstructed, lighting conditions are poor, the field of view is narrow, etc. In contrast, acoustic-based detection methods are omnidirectional, however, they are prone to errors due to possible noise in the signal. This paper presents a method of predicting the presence (detection and classification) of a drone using a single microphone and other inexpensive computational devices. A Support Vector Machine classified the spectral and temporal features of pre-segments generated using a sliding window for the audio signal. Additionally, spectral subtraction was used to reconstruct the magnitude spectrum of drone sounds to reduce false alarms. To increase the accuracy of predictions, an added confidence script is proposed based on a queue-and-dump approach to make the system more robust. The proposed system was tested in real time in a realistic environment with various drone models and flight characteristics. Performance is satisfactory in a quiet setting but the system generates excessive false alarms when exposed to lawn equipment.
Combining visible and infrared spectrum imagery using machine learning for small unmanned aerial system detection

Abstract:There is an increasing demand for technology and solutions to counter commercial, off-the-shelf small unmanned aerial systems (sUAS). Advances in machine learning and deep neural networks for object detection, coupled with lower cost and power requirements of cameras, led to promising vision-based solutions for sUAS detection. However, solely relying on the visible spectrum has previously led to reliability issues in low contrast scenarios such as sUAS flying below the treeline and against bright sources of light. Alternatively, due to the relatively high heat signatures emitted from sUAS during ight, a long-wave infrared (LWIR) sensor is able to produce images that clearly contrast the sUAS from its background. However, compared to widely available visible spectrum sensors, LWIR sensors have lower resolution and may produce more false positives when exposed to birds or other heat sources. This research work proposes combining the advantages of the LWIR and visible spectrum sensors using machine learning for vision-based detection of sUAS. Utilizing the heightened background contrast from the LWIR sensor combined and synchronized with the relatively increased resolution of the visible spectrum sensor, a deep learning model was trained to detect the sUAS through previously difficult environments. More specifically, the approach demonstrated effective detection of multiple sUAS flying above and below the treeline, in the presence of heat sources, and glare from the sun. Our approach achieved a detection rate of 71.2 8.3%, improving by 69% when compared to LWIR and by 30.4% when visible spectrum alone, and achieved false alarm rate of 2.7 2.6%, decreasing by 74.1% and by 47.1% when compared to LWIR and visible spectrum alone, respectively, on average, for single and multiple drone scenarios, controlled for the same confidence metric of the machine learning object detector of at least 50%. With a network of these small and affordable sensors, one can accurately estimate the 3D position of the sUAS, which could then be used for elimination or further localization from more narrow sensors, like a fire-control radar (FCR). Towards Real-Time Fast Unmanned Aerial Vehicle Detection Using Dynamic Vision Sensors

Abstract:Unmanned Aerial Vehicles (UAVs) are gaining popularity in civil and military applications. However, uncontrolled access to restricted areas threatens privacy and security. Thus, prevention and detection of UAVs are pivotal to guarantee confidentiality and safety. Although active scanning, mainly based on radars, is one of the most accurate technologies, it can be expensive and less versatile than passive inspections, e.g., object recognition. Dynamic vision sensors (DVS) are bio-inspired event-based vision models that leverage timestamped pixel-level brightness changes in fast-moving scenes that adapt well to low-latency object detection. This paper presents F-UAV-D (Fast Unmanned Aerial Vehicle Detector), an embedded system that enables fast-moving drone detection. In particular, we propose a setup to exploit DVS as an alternative to RGB cameras in a real-time and low-power configuration. Our approach leverages the high-dynamic range (HDR) and background suppression of DVS and, when trained with various fast-moving drones, outperforms RGB input in suboptimal ambient conditions such as low illumination and fast-moving scenes. Our results show that F-UAV-D can (i) detect drones by using less than <15 W on average and (ii) perform real-time inference (i.e., <50 ms) by leveraging the CPU and GPU nodes of our edge computer.

Abstract:This article focuses on aerial vehicle detection and recognition by a wide field of view monocular vision system that can be installed on UAVs (unmanned aerial vehicles). The objects are mostly observed on the background of clouds under regular daylight conditions. The main idea is to create a multi-step approach based on a preliminary detection, regions of interest (ROI) selection, contour segmentation, object matching and localization. The described algorithm is able to detect small targets, but unlike many other approaches is designed to work with large-scale objects as well. The suggested algorithm is also intended to recognize and track the aerial vehicles of specific kind using a set of reference objects defined by their 3D models. For that purpose a computationally efficient contour descriptor for the models and the test objects is calculated. An experimental research on real video sequences is performed. The video database contains different types of aerial vehicles: airplanes, helicopters, and UAVs. The proposed approach shows good accuracy in all case studies and can be implemented in onboard vision systems.
PEDS-AI: A Novel Unmanned Aerial Vehicle Based Artificial Intelligence Powered Visual-Acoustic Pest Early Detection and Identification System for Field Deployment and Surveillance

Abstract:Currently, there is an urgent need to develop a system for practical in-field pest early detection to combat grasshopper invasions of farmland. This research proposes the first novel visual-acoustic system created to expand the sensorial range for more field flexibility compared to the current unmanned aerial vehicle (UAV) detection. A visual-acoustic database is also designed to support this study. The proposed UAV system is designed and implemented to survey from an optimal 1m altitude and record 48k sampling rate audio to capture the unique visual-acoustic signatures of pests, allowing PEDS-AI to achieve UAV species detection, a problem difficult even for experts. PEDS-AI introduces a dual signal processing algorithm that combines deep learning source separation and spectral gating denoising to cope with the signal-to-noise ratios (SNR) caused by the UAV and quiet pests. PEDS-AI then uses segmented photos and scalograms of the cleaned recordings to perform species determination through convolutional neural networks enhanced with transfer learning. The current design can completely cover up to 12,500 $\frac{{{m^2}}}{{hr}}$ for less than 1000 dollars per unit. Improving the Yolov5 model with 46.5 million parameters with a UAV-collected dataset of 100+ infield 48MP photos, visual detection of grasshoppers achieved a precision of 0.92 and a recall of 0.84. In-field recordings from 16 species enhanced the Efficientnetv2 model with 52.9 million parameters, reaching 0.87 precision and 0.90 recall. This research has an immediate impact on in-field agricultural tracking of pest species and can also be applied to ecological management and ecosystem restoration.

Abstract:Robust real-time obstacle detection/avoidance is a challenging problem especially for micro and small aerial vehicles due to the limited number of the on-board sensors due to the battery constraint and low payload. Usually lightweight sensors such as CMOS camera are the best choice comparing with laser or radar sensors. For real-time applications, most studies focus on using stereo cameras to reconstruct a 3D model of the obstacles or to estimate their depth. Instead, in this paper, a method that mimics the human behavior of detecting the state of the approaching obstacles using single camera is proposed. During the flight, this method is able to detect the changes of the size area of the obstacles. First, the method detects the feature points of the obstacles, and then extracts the obstacles that has probability of getting close. In addition, by comparing the changes in the area ratios of the obstacle in the image sequence, the method can decide if it is obstacle or not. Finally, by estimating the obstacle 2D position in the image and combining with the tracked waypoints, the UAV can take the action of avoidance.

Abstract:The paper considers a problem of detection and identification of unmanned aerial vehicles (UAVs) against the animate and inanimate objects and identification of their load by optical and spectral optical methods. The state-of-the-art analysis has shown that, when using the radar methods to detect small UAVs, there is a dead zone for distances of 250-700 m, and in this case it is important to use optical methods for detecting UAVs. The application possibilities and improvements of the optical scheme for detecting UAVs at long distances of about 1-2 km are considered. Location is performed by intrinsic infrared (IR) radiation of an object using the IR cameras and thermal imagers, as well as using a laser rangefinder (LIDAR). The paper gives examples of successful dynamic detection and recognition of objects from video images by methods of graph theory and neural networks using the network FasterR-CNN, YOLO and SSD models, including one frame received. The possibility for using the available spectral optical methods to analyze the chemical composition of materials that can be employed for remote identification of UAV coating materials, as well as for detecting trace amounts of matter on its surface has been studied. The advantages and disadvantages of the luminescent spectroscopy with UV illumination, Raman spectroscopy, differential absorption spectroscopy based on a tunable UV laser, spectral imaging methods (hyper / multispectral images), diffuse reflectance laser spectroscopy using infrared tunable quantum cascade lasers (QCL) have been shown. To assess the potential limiting distances for detecting and identifying UAVs, as well as identifying the chemical composition of an object by optical and spectral optical methods, a described experimental setup (a hybrid lidar UAV identification complex) is expected to be useful. The experimental setup structure and its performances are described. Such studies are aimed at development of scientific basics for remote detection, identification, tracking, and determination of UAV parameters and UAV belonging to different groups by optical location and spectroscopy methods, as well as for automatic optical UAV recognition in various environments against the background of moving wildlife. The proposed problem solution is to combine the optical location and spectral analysis methods, methods of the theory of statistics, graphs, deep learning, neural networks and automatic control methods, which is an interdisciplinary fundamental scientific task.

Abstract:The use of drones has recently gained popularity in a diverse range of applications, such as aerial photography, agriculture, search and rescue operations, the entertainment industry, and more. However, misuse of drone technology can potentially lead to military threats, terrorist acts, as well as privacy and safety breaches. This emphasizes the need for effective and fast remote detection of potentially threatening drones. In this study, we propose a novel approach for automatic drone detection utilizing the usage of both radio frequency communication signals and acoustic signals derived from UAV rotor sounds. In particular, we propose the use of classical and deep machine-learning techniques and the fusion of RF and acoustic features for efficient and accurate drone classification. Distinct types of ML-based classifiers have been examined, including CNN- and RNN-based networks and the classical SVM method. The proposed approach has been evaluated with both frequency and audio features using common drone datasets, demonstrating better accuracy than existing state-of-the-art methods, especially in low SNR scenarios. The results presented in this paper show a classification accuracy of approximately 91% at an SNR ratio of −10 dB using the LSTM network and fused features.

Abstract:Noncooperative micro unmanned aerial vehicles (UAVs) bring potential threats to public security and citizens' privacy. A system‐termed multimodal UAV 3D trajectory exposure system integrating a 64‐channel microphone array, a camera, and a lidar is devised to provide a wide range detection (90° × 360°) and high‐precision (<0.8° at 180 m) 3D tracking for UAVs. The increasing popularity of small drones has stressed the urgent need for an effective drone‐oriented surveillance system that can work day and night. Herein, an acoustic and optical sensor‐fusion‐based system‐termed multimodal unmanned aerial vehicle 3D trajectory exposure system (MUTES) is presented to detect and track drone targets. MUTES combines multiple sensor modules including microphone array, camera, and lidar. The 64‐channel microphone array provides semispherical surveillance with high signal‐to‐noise ratio of sound source estimation, while the long‐range lidar and the telephoto camera are capable of subsequent precise target localization in a narrower but higher definition field of view. MUTES employs a coarse‐to‐fine, passive‐to‐active localization strategy for wide‐range detection (semispherical) and high‐precision 3D tracking. To further increase the fidelity, an environmental denoising model is trained, which helps to select valid acoustic features from a drone target, thus overcomes the drawbacks of the traditional sound source localization approaches when facing noise interference. The effectiveness of the proposed sensor‐fusion approach is validated through field experiments. To the best of the knowledge, MUTES provides the farthest detection range, highest 3D position accuracy, strong anti‐interference capability, and acceptable cost for unverified drone intruders.

Abstract:This article explores the challenge of acoustic drone detection in real-world scenarios, with an emphasis on the impact of distance, to see how sound propagation affects drone detection. Learning machines of varying complexity are used for detection, ranging from simpler methods such as linear discriminant, multilayer perceptron, support vector machines, and random forest to more complex approaches based on deep neural networks like YAMNet. Our evaluation meticulously assesses the performance of these methods using a carefully curated database of a wide variety of drones and interference sounds. This database, processed through array signal processing and influenced by ambient noise, provides a realistic basis for our analyses. For this purpose, two different training strategies are explored. In the first approach, the learning machines are trained with unattenuated signals, aiming to preserve the inherent information of the sound sources. Subsequently, testing is then carried out under attenuated conditions at various distances, with interfering sounds. In this scenario, effective detection is achieved up to 200 m, which is particularly notable with the linear discriminant method. The second strategy involves training and testing with attenuated signals to consider different distances from the source. This strategy significantly extends the effective detection ranges, reaching up to 300 m for most methods and up to 500 m for the YAMNet-based detector. Additionally, this approach raises the possibility of having specialized detectors for specific distance ranges, significantly expanding the range of effective drone detection. Our study highlights the potential of drone acoustic detection at different distances and encourages further exploration in this research area. Unique contributions include the discovery that training with attenuated signals with a worse signal-to-noise ratio allows the improvement of the general performance of learning machine-based detectors, increasing the effective detection range achieved, and the feasibility of real-time detection, even with very complex learning machines, opening avenues for practical applications in real-world surveillance scenarios.

Abstract:This manuscript delves into the intricate realm of small target detection technology in Unmanned Aerial Vehicles (UAVs), a pivotal element in contemporary aviation dynamics, with widespread implications across military, civilian, and emergency response domains. Central to this is the detection of diminutive targets, a process entailing sophisticated sensors and image processing algorithms, contending with the intricacies of identifying small, non-distinct targets against multifaceted backgrounds. The paper conducts a comprehensive review of the primary challenges, technological breakthroughs, and a spectrum of algorithms including RNN, SSD, and YOLO, in addition to examining prominent techniques such as Faster R-CNN in UAV target discernment. Moreover, it accentuates the application of this technology in areas like military reconnaissance, agriculture, and disaster management, highlighting its promising potential in urban settings and within the Internet of Things framework. The discourse extends to prospective developments, emphasizing the surmounting of technical limitations through enhancements in algorithmic efficiency, integration of multi-sensor systems, and advancements in real-time processing capabilities. Empirical evaluations of the technology’s practical efficacy underscore its profound prospective impact. In summation, the technology of small target detection in UAVs, propelled by ceaseless innovation and pragmatic deployment, stands at the cusp of engendering substantial contributions across various sectors and in the evolution of smart urban concepts.
Estimation of number of unmanned aerial vehicles in a scene utilizing acoustic signatures and machine learning

Abstract:With the exponential growth in unmanned aerial vehicle (UAV)-based applications, there is a need to ensure safe and secure operations. From a security perspective, detecting and localizing intruder UAVs is still a challenge. It is even more challenging to accurately estimate the number of intruder UAVs on the scene. In this work, we propose a simple acoustic-based technique to detect and estimate the number of UAVs. Our method utilizes acoustic signals generated from the motion of UAV motors and propellers. Acoustic signals are captured by flying an arbitrary number of ten UAVs in different combinations in an indoor setting. The recorded acoustic signals are trimmed, processed, and arranged to create an UAV audio dataset. The UAV audio dataset is subjected to time-frequency transformations to generate audio spectrogram images. The generated spectrogram images are then fed to a custom lightweight convolutional neural network (CNN) architecture to estimate the number of UAVs in the scene. Following training, the proposed model achieves an average test accuracy of 93.33% as compared to state-of-the-art benchmark models. Furthermore, the deployment feasibility of the proposed model is validated by running inference time calculations on edge computing devices, such as the Raspberry Pi 4, NVIDIA Jetson Nano, and NVIDIA Jetson AGX Xavier.
