Abstract:According to the autocorrelation function (ACF) of the ultrafine particles, the auto-regressive (AR) model used for dynamic light scattering (DLS) signals simulation can be established. By the method, DLS signals for nanoparticles distribution are simulated respectively and every ACF of simulation signal performs a great agreement with its theory value. The simulation signals were respectively inversed and inversion errors are less than 5.25%. The particles size inversions of Photon Correlation Spectroscopy (PCS) are obtained by Morozov discrepancy principle. Experiments show that the method based on AR model is feasible in DLS signal simulation.

Abstract:To what extent can particulate random media be characterised using direct wave backscattering from a single receiver/source? Here, in a two-dimensional setting, we show using a machine learning approach that both the particle radius and concentration can be accurately measured when the boundary condition on the particles is of Dirichlet type. Although the methods we introduce could be applied to any particle type. In general backscattering is challenging to interpret for a wide range of particle concentrations, because multiple scattering cannot be ignored, except in the very dilute range. Across the concentration range from 1% to 20% we find that the mean backscattered wave field is sufficient to accurately determine the concentration of particles. However, to accurately determine the particle radius, the second moment, or average intensity, of the backscattering is necessary. We are also able to determine what is the ideal frequency range to measure a broad range of particles sizes. To get rigorous results with supervised machine learning requires a large, highly precise, dataset of backscattered waves from an infinite half-space filled with particles. We are able to create this dataset by introducing a numerical approach which accurately approximates the backscattering from an infinite half-space.

Abstract:The aim of this paper is to present some new developments in particle characterization. More precisely, the paper will be focused on the description of some progresses in the characterization of particles by interferometric methods which are generally considered as the most accurate ones. Three standard configurations will be presented and discussed: i) Interference between scattered light from a particle and a single reference beam (holography), ii) Interference between different kinds of light scattered by a single particle (ILIDS), iii) Interference between the light scattered from different particles. A special attention will be devoted to the possibility to obtain 3D information on the particle location.

Abstract:To characterize fine particulate products in industrial gas–solid processes, insights into the particle properties are accessible via various measurement techniques. For micron particles, online imaging techniques offer a fast and reliable assessment of their size and shape. However, for the shape analysis of submicron particles, only offline techniques, such as SEM and TEM imaging, are available. In this work, an online sensor system based on the principle of elastic light scattering of particles in the gas phase is developed to measure the shape factor of non-spherical particles in the size range of 500 nm to 5 μm. Single aerosol particles are guided through a monochromatic circularly polarized laser light beam by an aerodynamic focusing nozzle, which was developed based on the CFD simulation of the flow and particle movement. The intensity of the scattered light is measured at several discrete positions in the azimuthal direction around the particles. An algorithm computes the sphericity of the particles based on the distribution of the intensity signals. The sensor construction, data processing and analysis are described. Model aerosols with particles of different shapes are investigated to test the developed sensor and show its performance in the determination of the sphericity distribution of particles.

Automated Structure Analysis of Small Angle Scattering Data via Machine Learning

Abstract:Billions of dollars have been invested in recent years to build up national scattering facilities around the world with more advanced configurations and faster data collection for small angle scattering (SAS), a technique that enables in-situ structural analysis of nanoparticles (NP) under stringent sample environments. However, the interpretation of experimental SAS data collected in reciprocal space to determine its corresponding real-space morphology is typically a slow process that requires significant domain expertise, leading to high-throughput scattering facilities such as synchrotron scattering centers collecting large quantities of data that may potentially be left unanalyzed. Here, we report a fast and data-efficient machine learning (ML) framework for identifying NP morphologies and their corresponding structural parameters from both theoretical and experimental SAS data. The developed classification and regression models, which take as input raw scattering curves with minimal pre-processing, are able to accurately identify the morphology and structural dimensions from experimental scattering curves with comparable accuracy to human experts. Critically, we discuss design choices that facilitate the practical application of ML frameworks in scattering facilities. Our ML framework is designed to be easy to train, to work well when extrapolating to structural parameters outside of the parameter range the models were trained on, and to enable verification of ML predictions. The enhanced data analysis efficiency enabled by application of these ML models to real-time in-situ analysis of SAS data has the potential to revolutionize the utilization of synchrotron and neutron scattering facilities for probing nanostructures.

Abstract:This paper focuses the data processing and then the multi-class classification of suspended particles using a new polarized light measurement scheme. Detection of multidimensional polarization parameters keeps the advantages of fast detection speed and non-invasive local analysis of light scattering method, and increases the information dimension of the analyzed particles. However, the polarization indices are numerous and interrelated. It is difficult to complete classification prediction by a few specific indices. More advanced algorithms are needed. In our research, we selected six kinds of representative particles and three typical machine learning algorithms. k-NN, Neural network and SVM methods were used to construct the classification models and solve different classification tasks. By comparison, we evaluated these models in terms of their performance for classification tasks in different aspects. Furthermore, we discuss how to improve the models by feature selection, and a rough prediction of the capability of each polarization index to reflect the particulate features was made.

Abstract:In contrast to conventional dynamic light scattering (DLS) measurement via a single sampling volume (SV) observation over a long time span, we propose a novel technique named "photon ensemble correlation spectroscopy" for ultrafast characterization of diffusive particle dynamics through decorrelation analysis of complex-valued DLS scattering signals from an ensemble of independent SVs. We confirm that the ensemble analysis provides a decorrelation-rate-limited ultrafast measurement and demonstrates the feasibility of imaging spatially resolved particle dynamics. Moreover, the use of complex-valued signals gives additional superiority in terms of reliability.

Abstract:The efficient particle measurement methods are very important for the assessment of ambient air quality. Compared with other methods, the light scattering method has the advantages of non-destructive and real time detection, and has been used in the detection and analysis of particle composition and concentration. Different from non-polarized light scattering detection, polarized light scattering is suitable for the measurement of fine particles, such as PM1 and PM2.5. In this paper, we establish a three-component model to describe three typical particle elements in atmospheric suspended matters, and also set several pollution state changes according to some reported real measured data. By our primary polarization simulation under weak scattering approximation, we analyze Mueller matrix elements fluctuation with the different changes of particle concentration and distribution, and then extract two characteristic elements to follow the status particle composition. The results imply the potential of the backscattered polarization characterization to distinguish and evaluate the parameter variation in an atmospheric particulate model, and also show the possible sensitivity higher than the non-polarization characteristic. © 2014 SPIE.
Real Time and Online Aerosol Identification Based on Deep Learning of Multi-Angle Synchronous Polarization Scattering Indexes.

Abstract:In this study, we employ our developed instrument to obtain high-throughput multi-angle single-particle polarization scattering signals. Based on experimental results of a variety of samples with different chemical composition, particle size, morphology, and microstructure, we trained a deep convolutional network to identify the polarization signal characteristics during aerosol scattering processes, and then investigate the feasibility of multi-dimensional polarization characterization applied in the online and real-time fine and accurate aerosol recognition. Our model shows a high classification accuracy rate (>98%) and can achieve aerosol recognition at a very low proportion (<0.1%), and shows well generalization ability in the test set and the sample types not included in the training set. The above results indicate that that the time series pulses from multi-angle polarization scattering contain enough information related with microscopic characteristics of an individual particle, and the deep learning model shows its capability to extract features from these synchronous multi-dimensional polarization signals. Our investigations confirm a good prospect of aerosol attribute retrieval and identifying and classifying individual aerosols one by one by the combination of multi-dimensional polarization scattering indexes with deep learning method.

Abstract:Laser light scattering (LLS), especially dynamic laser light scattering (DLS), also known as photon correlation spectroscopy (PCS), is a well established method for particle size distribution analysis. It usually involves a Laplace inversion of the field autocorrelation function. However, the resolution is limited because of the ill-conditioned nature of this Laplace inversion. No unique solution exists when noise is present on the data. In contrast with this ill-conditioned nature, the angular dependence of scattered (static) intensities is precisely not ill-conditioned, which allows the resolution of the ill-conditioned inversion of DLS data to be improved. In order to characterize samples with more complicated size distributions, an intensity-constrained multi-angle PCS data analysis program has been developed, which is an alternative way of normalizing the field correlation function to that reported by Cummins and Staples [12]. In this program, the field autocorrelation function is normalized to the scattering intensity by using a predetermined coherent factor at each angle, which provides an additional constraint on the Laplace inversion of multi-angle PCS data analysis. The alternative analysis improves the resolution of PCS and provides a more reliable particle size distribution than single-angle data analysis. Both simulated and measured LLS data are used to illustrate its application, resolution and limitations.
Deep-Learning Driven, High-Precision Plasmonic Scattering Interferometry for Single-Particle Identification

Abstract:Label-free probing of the material composition of (bio)nano-objects directly in solution at the single-particle level is crucial in various fields, including colloid analysis and medical diagnostics. However, it remains challenging to decipher the constituents of heterogeneous mixtures of nano-objects with high sensitivity and resolution. Here, we present deep-learning plasmonic scattering interferometric microscopy, which is capable of identifying the composition of nanoparticles automatically with high throughput at the single-particle level. By employing deep learning to decode the quantitative relationship between the interferometric scattering patterns of nanoparticles and their intrinsic material properties, this technique is capable of high-throughput, label-free identification of diverse nanoparticle types. We demonstrate its versatility in analyzing dynamic surface chemical reactions on single nanoparticles, revealing its potential as a universal platform for nanoparticle imaging and reaction analysis. This technique not only streamlines the process of nanoparticle characterization, but also proposes a methodology for a deeper understanding of nanoscale dynamics, holding great potential for addressing extensive fundamental questions in nanoscience and nanotechnology.

Abstract:Optical scatterometry is the workhorse technique for in-line manufacturing process control in the semiconductor industry. However, as manufacturing processes develop, traditional methods for solving the inverse problem in optical scatterometry are struggling to continue improving productivity. To address this problem, machine learning can be a promising method, but it is a challenge to ensure robustness. In this paper, we propose a machine learning method to reconstruct the profile of nanostructures. The proposed method consists of three parts: compressing signature using a dimensionality reduction approach based on the principle component analysis, constructing a surrogate electromagnetic solver (SurEM) based on an artificial neural network mapping from parameters to signatures, and iteratively comparing the SurEM-predicted signatures with measured one to finally determine the results. Experiments have demonstrated that the proposed method can achieve fast and accurate measurement. This method is thus promising as an efficient in-line measurement method for nano- or micro-scale manufacturing.

Classification of ice particle shapes using machine learning on forward light scattering images

Abstract:Abstract Machine Learning (ML) has rapidly transitioned from a niche activity to a mainstream tool for environmental research applications including atmospheric science cloud microphysics studies. Two recently developed cloud particle probes measure the light scattered in the near forward direction and save digital images of the scattering light. Scattering pattern images collected by the Particle Phase Discriminator (PPD-2K) and the Small Ice Detector version 3 (SID-3) provide valuable information for particle shape and size characterization. Since different particle shapes have distinctly different light scattering characteristics, the images are ideally suited for ML. Here results of a ML project to characterize ice particle shapes sampled by the PPD-2K in ice fog and diamond dust during a 3-year project in Fairbanks, Alaska. 2.15 million light scattering pattern images were collected during three years of measurements with the PPD-2K. Visual Geometry Group (VGG) Convolutional Neural Network (CNN) was trained to categorize light scattering patterns into 8 categories. Initial training images (120 each category) were selected by human visual examination of data and the training dataset was augmented using an automated iterative method for image identification of further images which were all visually inspected by a human. Results were well correlated to similar categories identified from previously developed classification algorithms. ML identify characteristics not included in automated analysis such as sublimation. Of the 2.15 million images analyzed, 1.3% were categorized as spherical (liquid), 43.5% were categorized as having rough surfaces, 15.3% were pristine, 16.3% were categorized as sublimating and the remaining 23.6% did not fit into any of those categories (irregular or saturated).

Abstract:The ability to perform nanometer-scale optical imaging and spectroscopy is key to deciphering the low-energy effects in quantum materials, as well as vibrational fingerprints in planetary and extraterrestrial particles, catalytic substances, and aqueous biological samples. The scattering-type scanning near-field optical microscopy (s-SNOM) technique has recently spread to many research fields and enabled notable discoveries. In this brief perspective, we show that the s-SNOM, together with scanning probe research in general, can benefit in many ways from artificial intelligence (AI) and machine learning (ML) algorithms. We show that, with the help of AI- and ML-enhanced data acquisition and analysis, scanning probe optical nanoscopy is poised to become more efficient, accurate, and intelligent.

Abstract:Conventional dynamic light scattering (DLS) using a CCD camera as optical area detector (here we called Image Dynamic Light Scattering method, for the data acquired by images) has been developed successfully. We present a model experiment in a micro-channel to study flowing Brownian motion systems of polystyrene latex particles by using Image Dynamic Light Scattering method (IDLS). The modified correlation function proposed by Chowdhury et al, which is applied to the analysis of extracting the size and velocity of laminar flowing particulate dispersions, is used in the paper to obtain the particle size from the scattered light signals. The new method allows for much shorter measurement time compared to conventional DLS. As the inversion algorithm of polydisperse system is yet very complex, the measurement of the paper is for monodisperse polystyrene latex particles.

Abstract:Accurate identification and monitoring of aerosol properties is crucial for understanding their sources and impacts on human health and the environment. Therefore, we propose a feature extraction and attribute recognition method from in situ light-scattering measurements based on Bayesian Optimization, wavelet scattering transform, and long short-term memory neural network (BO-WST-LSTM), with empirical mode decomposition (EMD) and independent component analysis (ICA) algorithm for signal preprocessing. In this study, an experimental platform was utilized to gather light-scattering signals from particles with varying characteristics. The signals are then processed using the EMD-ICA noise reduction technique. Then, the wavelet scattering network is used to realize the adaptive extraction of the characteristics of the particle light-scattering signal, and the Bayesian Optimization model is used to optimize the hyperparameters of the LSTM neural network. The extracted scattering coefficient matrix is input into the LSTM for iterative training. Finally, the SoftMax layer's probability classification method is applied to the identification of particle attributes. The results show that the multi-angle particle light-scattering signal detection system designed and built in this study performs well and is capable of effectively collecting particle light-scattering signals. At the same time, the proposed new method for particle property recognition demonstrates good classification performance for six different types of particles with a particle size of 2 μm, achieving a classification accuracy of 98.83%. This proves its effectiveness in recognizing particle properties and provides a solid foundation for particle identification.

Abstract:We present an efficient machine learning framework for detection and classification of nanoparticles on surfaces that are detected in the far-field with Coherent Fourier Scatterometry (CFS). We study silicon wafers contaminated with spherical polystyrene (PSL) nanoparticles (with diameters down to $\lambda/8$). Starting from the raw data, the proposed framework does the pre-processing and particle search. Further, the unsupervised clustering algorithms, such as K-means and DBSCAN, are customized to be used to define the groups of signals that are attributed to a single scatterer. Finally, the particle count versus particle size histogram is generated. The challenging cases of the high density of scatterers, noise and drift in the dataset are treated. We take advantage of the prior information on the size of the scatterers to minimize the false-detections and as a consequence, provide higher discrimination ability and more accurate particle counting. Numerical and real experiments are conducted to demonstrate the performance of the proposed search and cluster-assessment techniques. Our results illustrate that the proposed algorithm can detect surface contaminants correctly and effectively.
