Abstract:The power transformer is a critical and expensive asset in electrical transmission and distribution network systems. It is highly important to estimate its condition precisely to avoid unwanted outages. The health index (HI) is a tool to aid such decisions which allow for a quick and efficient way to assess, evaluate and compare the overall condition of the transformers population. The Artificial Intelligence-based based HI is proposed to predict the condition of transformers. This is done to simplify, speed up, and reduce the uncertainty. A HI approach is to assess the power transformer from its oil quality, dissolved gas analysis (DGA), and paper condition. In this study, the total of 504 transformer assessment data (with voltage of 150kV) was used to classify HI. Seven AI methods were investigated, such as k-Nearest Neighbor (kNN), Support Vector Machine (SVM), Adaptive Boosting (AdaBoost), Random Forest (RF), Naïve Bayes (NB), Artificial Neural Network (ANN), and Decision Tree (Tree). At the end of the discussion, a comparison of various was carried out and evaluated using the accuracy of the actual HI category as a reference. Random forest model was chosen as the best performing AI method to predict HI categories, with the accuracy of 97.3%.

Abstract:The power transformer is the backbone of the power grid system. A reliable in-service operation of the power transformer is necessary for the efficient availability and distribution of the power. For maintenance of the power transformer, several standard tests are performed periodically to determine the condition (referred to as health index (HI)) of the power transformer. The method of determination of HI requires human involvement, which not only increases the maintenance time but may also cause an error in labeling the HI depending on the experience and understanding of the operator or engineer. In this paper, an artificial intelligence-based approach is employed for the prediction of the power transformer HI using measured data of different transformer tests. The best accuracy of 96.3% was achieved with the decision tree classifier. It is shown that the insulation resistance test has the best correlation with the HI of the transformer.

Abstract:Power transformer is a critical and expensive asset in electric transmission and distribution networks. It is essential to monitor the health condition of all power transformer fleet in such networks to avoid unwanted outages. The health index (HI) is a quick and efficient way to assess the condition of power transformers based on multi-criteria. While Power transformer HI method has been well presented in the literature, not much attention was given to handle the uncertainty and reliability of this method due to unavailability of used data. Therefore, this paper aims to tackle this issue through employing Artificial Intelligence (AI)-based techniques to reveal the health condition of power transformers with high accuracy and at the same time handling data uncertainty. The proposed HI approach assesses the power transformer insulation system based on oil quality, dissolved gas analysis (DGA), and paper condition. In this regard, collected data from 504, 150-kV transformers are used to establish the proposed AI-models. Seven AI algorithms including k-Nearest Neighbor (kNN), Support Vector Machine (SVM), Random Forest (RF), Naïve Bayes (NB), Artificial Neural Network (ANN), Adaptive Boosting (AdaBoost), and Decision Tree are investigated. A performance comparison of the proposed AI-based HI models is carried out using the scoring-weighting-based HI method as the reference. Results show that RF model provides the best performance in predicting power transformer HI with an accuracy of 97.3%.

Abstract:Energy is a basic necessity in every country. The worldwide demand for energy will rise due to the developments of power generation in industrial, service, and residential sectors. A healthy power system is therefore very important to guarantee continuous electricity supply to the end users and this can be achieved through asset management. A proper asset management will allow asset managers to conduct quality assessment of conditions and to develop future management strategies of the electrical assets such as transformers. The execution of transformer asset management involves an investigation of the transformer's condition by employing Transformer's Health Index (THI). Mathematical equation/algorithm or expert judgment has been investigated by many previous studies as one of the technique to determine health index (HI). Some of the established methods of HI determination such as scoring and ranking method, tier method, matrices and multi-feature assessment model have led to the different interpretations of the final condition of a transformer. This paper critically examines and explores the previous studies related to transformer health index by using mathematical equation/algorithm or expert judgment. The concept of HI and its formulation are presented in this study. Generally, there are three parts of HI formulation which are input, algorithm for HI and the output of HI. The application of HI is discussed in terms of the performance of in-service transformer. The limitations of the available methods are also discussed and future works to overcome the problems are suggested.

Abstract:Power transformers play a vital role in ensuring the reliability of power and electricity systems, guaranteeing continuous and uninterrupted power supply. Improving the performance, longevity, and reliability of power transformers depends on diligent maintenance practices and the use of suitable methods. Maintenance should be done regularly and carefully to minimize growth and damage to internal and external surfaces. To facilitate standardized and accurate inspections, industry standard provide well-defined methods for measuring the probability of failure and calculating the remaining life of variable power This standard is standards for evaluating transformer health and performance, providing guidance on maintenance practices, and encouraging systematic improvement reliability. This review paper scrutinizes tests aimed at detecting chemical and electrical faults in electrical transformers. These tests incorporate well-established techniques such as dissolved gas analysis, frequency response analysis, and partial discharge (PD) analysis. In addition to these traditional approaches the paper dives into the artificial intelligence (AI) techniques used by researchers in transformer fault diagnosis.

Abstract:The presented paper aims to establish a strong basis for utilizing machine learning (ML) towards the prediction of the overall insulation health condition of medium voltage distribution transformers based on their oil test results. To validate the presented approach, the ML algorithms were tested on two databases of more than 1000 medium voltage transformer oil samples of ratings in the order of tens of MVA. The oil test results were acquired from in-service transformers (during oil sampling time) of two different utility companies in the gulf region. The illustrated procedure aimed to mimic a realistic scenario of how the utility would benefit from the use of different ML tools towards understanding the insulation health index of their transformers. This objective was achieved using two procedural steps. In the first step, three different data training and testing scenarios were used with several pattern recognition tools for classifying the transformer health condition based on the full set of input test features. In the second step, the same pattern recognition tools were used along with the three training/testing scenarios for a reduced number of test features. Also, a previously developed reduced model was the basis to reduce the needed number of tests for transformer health index calculations. It was found that reducing the number of tests did not influence the accuracy of the ML prediction models, which is considered as a significant advantage in terms of transformer asset management (TAM) cost reduction.

Abstract:In order to monitor the aging of transformers and ensure the operational safety in substations, a practical detection system for indoor substation transformers based on the analysis of audio signal is designed, which use computer technology instead of manpower to efficiently monitor the transformers working states in real-time. Our work consists of a small and low cost AI-STBOX and an intelligent AI Cloud Platform. AI-STBOX is installed directionally in each transformer room for continuously collecting, compressing and uploading the transformers audio data. The AI Cloud Platform receives audio data from AI-STBOX, analyses and organizes the data to low-dimensional speech features with STFT and Mel cepstrum analysis. Input the features into a powerful deep neural network, the system can quickly distinguish the working states of each substation transformer before is has serious faults. It can locate aging transformers, command the maintenance platform to quickly release the repair task, thus avoid unforeseeable outages and minimize planned downtimes. The approach has achieved excellent results in the substation aging transformers detection scene.

Abstract:The role of a power transformer is to convert the electrical power level and send it to the consumer, making it an essential component of a power system. In addition, transformer asset management is essential for monitoring the functioning of transformers in the system to prevent failure and anticipating the health state of transformers, using a technique known as the health index (HI). However, the calculation and computation to determine the transformer HI based on a scoring and ranking technique is complex and required expert validation. Therefore, this paper presents a transformer HI prediction using a feedforward neural network (FFNN) to improve the existing complex scoring and ranking technique. Levenberg–Marquardt (LM), Bayesian Regularized (BR), and Scaled Conjugate Gradient (SCG) are the FFNN training techniques presented in this study to forecast the transformer HI. To validate the techniques, the HI values generated by different FFNN techniques were compared to the scoring and ranking system. Then, the performance of the proposed ANN was evaluated using the correlation coefficient and mean square error (MSE). As a result, the transformer HI was successfully predicted by employing three FFNN techniques, namely the LM, BR, and SCG techniques, which were able to determine whether the transformer's condition is very good, good, fair, or poor. In conclusion, the ANN suggested in this study has also been validated with the ranking and scoring approach, which provides high similarity score in comparison to the transformer health index.

Abstract:Power transformer is an important equipment in the electric power system. The power transformer has the main task of changing the voltage, transmitting electricity, and distributing electricity. Disruption or failure of the transformer can result in asset fires and power outages. Transformer power failure can result in social and economic losses. The right maintenance strategy can reduce the risk of transformer failure and optimize operational costs and maintenance costs. The Health Index is used to provide an overall assessment of the condition of the power transformer, assess the reliability of the power transformer, and the strategy for maintaining the power transformer. In addition to durability, the health index of the transformer can be assessed from the life expectancy of the transformer. Health Index values can be obtained from expert judgment, calculations, and prediction methods using Artificial Intelligence. This paper discusses the implementation of Artificial Neural Network (ANN) as one of the Artificial Intelligence (AI) algorithms to predict the condition of the transformer health index. The result is compared to the calculated HI, then validated by 79 transformers that have been comprehensively assessed by the expert.

Abstract:Abstract Transformer Health Index (HI) has become a standard tool for performing transformer health evaluations. Due to economic constraints, the recently published paper focuses on developing various techniques to identify the most dominant features for transformer HI prediction. However, the fundamental problems concerning their input features remain unresolved since most suggested features contradict industry practice. In this paper, the primary objective is to investigate the performance of the transformer HI by developing and utilizing only dominant features following the industry recommendation. The investigated dominant features in this paper using 1) CO2/CO ratio and 2) the Incipient fault for detecting temperature abnormalities, and 3) the Dissipation Factor (DF) for detecting oil contamination. The performance validation is carried out using various machine learning (ML) classifiers. Also, the performance of the ML model is validated based on 10-fold type cross-validation to avoid biases in the experiment. As a result, the proposed Artificial Neural Network (ANN) network utilizing the investigated dominant features following the industry practice has produced the highest average accuracy of 80.09% than others ML techniques as a classifier. Hence, additional studies to complement the investigated dominant features may be considered for the subsequent investigation.

Abstract:With the integration of data and information obtained from a variety of chemical and electrical tests on transformer insulating oil, it is possible to evaluate the health condition of the insulation system of an in-service power transformer. This paper develops an intelligent algorithm for automatically processing the data collected from oil tests and determining a health index for the transformer insulation system. This intelligent algorithm adopts a fuzzy support vector machine (FSVM) approach, which constructs a statistical model using a training database based on the historic data collected from 181 in-service power transformers. The procedure of constructing the training database, the formulation and implementation of FSVM and the data preprocessing methods for dealing with a class imbalanced training database is presented in this paper. Numerical experiments are also conducted to evaluate the performance of the algorithms developed in the paper.

Abstract:Power transformer monitoring is an essential asset management routine for reliable operation of transmission and distribution networks. Over the last two decades, several mathematical and soft computing -based health assessing approaches have been developed based on various power transformer diagnostic tests. However, the tests data correlation analysis and attributes prioritization are not yet adequately established in the current transformer health estimation methods. Therefore, this paper presents a hybrid analytic hierarchy process-based grey relational analysis as a potential multi-criteria decision-making tool for transformer health assessment. The proposed approach facilitates a comparative correlation between transformer samples and attributes prioritization with authenticated hierarchal analysis. The closely relatable attributes are grouped into three distinct grades to ensure transparency. These grades are further correlated using an artificial intelligence fuzzy logic technique. Through this integration, reliable numerical health indices can be obtained to help classify the transformer health condition. Moreover, the general complexity issues observed in forming expert rules with high number of fuzzy logic inputs are completely nullified with reduced three input grades and maximum input-output feasible fuzzy combination. The proposed hybrid model is validated using pre-known health conditions of 730 transformers assessed by Saudi electric company in Gulf region and compared with some transformer health prediction methods published in the literatures. Comparison reveals the superiority of the proposed model that achieved a prediction accuracy more than 96%. Contrary to other techniques published in the literature, the proposed model does not call for extensive training data and can facilitate real-time condition monitoring of power transformers.

Abstract:In power grid, operating and maintaining engineers have recorded plenty of operation data and fault or defect texts of distribution transformers, which contain asset health information. However, less information is effectively exploited in devices condition assessment. Aiming at improving the decision-making for condition based maintenance, a practical condition assessment method based on multi-source information fusion for distribution transformers is proposed in this paper. Firstly, an assessment index system based on real time and statistical operation data of transformers is introduced. Secondly, through HMM-based text preprocessing and the machine learning of relativity, the text mining technique realized the key information extraction from transformer's fault and defect elimination record texts for condition assessment. Finally, after synthesizing the subjective initial index weight, equipment's aging and the “Short Board Effect”, the optimized condition assessment model based on multi-source information fusion for distribution transformer is established. An operating transformer example reveals that this model is effective and accurate, comparing with the other available models. It shows that with this method, the transformer's accurate health status and evolution trend could be reflected much more timely and rigorously.

Abstract:After the massive integration of distributed energy resources, energy storage systems and the charging stations of electric vehicles, it has become very difficult to implement an efficient grid energy management system regarding the unmanageable behavior of the power flow within the grid, which can cause many critical problems in different grid stages, typically in the substations, such as failures, blackouts, and power transformer explosions. However, the current digital transition toward Energy 4.0 in Smart Grids allows the integration of smart solutions to substations by integrating smart sensors and implementing new control and monitoring techniques. This paper is proposing a hybrid artificial intelligence multilayer for power transformers, integrating different diagnostic algorithms, Health Index, and life-loss estimation approaches. After gathering different datasets, this paper presents an exhaustive algorithm comparative study to select the best fit models. This developed architecture for prognostic (PHM) health management is a hybrid interaction between evolutionary support vector machine, random forest, k-nearest neighbor, and linear regression-based models connected to an online monitoring system of the power transformer; these interactions are calculating the important key performance indicators which are related to alarms and a smart energy management system that gives decisions on the load management, the power factor control, and the maintenance schedule planning.

Abstract:An artificial neural network (ANN) based methodology to diagnose transformer faults is proposed. The synthetic minority over-sampling technique (SMOTE) is used to solve the imbalance in the dataset. The SMOTE is improved by introducing a full cycle of creating synthetic samples from minority class samples for the goals that the over-sampled ratio can be automatically determined and the sample size of each category can be completely consistent. The contents of dissolved gases in transformer oils are treated as the original features. The optimal features combination for ANN is determined by comparing the performances of the ANN when different feature combinations are used. The performances of different activation functions used in the ANN are investigated to give the optimal one. The tested results show the high accuracy (97.92%) of the proposed methodology if the optimum feature combination and activation function are used.

Abstract:In the electrical energy transmission and distribution sector, power transformers play an important role. Early fault diagnosis and prognosis are essential to ensure continuous operation and also to prepare a proper maintenance schedule based on the requirements. The occurrence of a fault in the transformer will lead to the formation of various gases inside the transformer tank. For fault diagnosis in the transformer, Dissolved Gas Analysis (DGA) is an excellent method. An Artificial Intelligence (AI) based fault diagnosis and prognosis system using dissolved gases in transformer oil is helpful to predict the health state of the transformer well in advance. Hence, based on the fault severity level, the remaining useful life of the transformer, fault type and current state of the transformer can be estimated effectively by imparting AI to the existing system. A Two-Tier Fuzzy Logic Controller (TTFLC) is proposed in this article to find the type of fault and health index (HI) of the transformer. For further fault prognosis, an effective Gated Recurrent Network (GRN) based deep learning enabled future learning estimator is used for predicting the Criticality Index (CI) of the Transformer. The performance of the proposed method is evaluated for both data from the IEEE data set and expert data collected from the southern Tamil Nadu region. The proposed system shows better results even in multivariate, complex process systems. The diagnosis accuracy of the proposed system is obtained as 95.28% and it compared with conventional methods such as Rogers Ratio Method (RRM), Duval Triangle Method (DTM) and Duval Pentagon Method (DPM) and other AI based methods such as Radial Basis Neural Network (RBNN), k-nearest neighbors (KNN). The diagnosis accuracy of other conventional and AI based methods are less than 90% for the collected dataset.

Abstract:To achieve accurate prediction of the remaining lifespan of a power transformer, it is essential to develop sophisticated health indicator (HI) that capture the entire lifespan of the power transformer. In this regard, we propose a method for constructing a power transformer HI based on ICNN-DRSN (Improved Convolutional Neural Network and Deep Residual Shrinkage Network). This approach leverages the ICNN and DRSN to extract dynamic features from online dynamic monitoring data, while utilizing a spectral clustering algorithm to cluster static features derived from data such as power transformer operation settings and environmental conditions. Subsequently, we fuse the extracted dynamic features with the clustered static features to derive a comprehensive HI that effectively characterizes the entire lifespan of transformers. These robust HI serve as the foundation for predicting the remaining lifespan of power transformers. Through example analysis and calculations, we demonstrate that by integrating multiple degradation variables, the fused HI provide a more comprehensive and accurate prediction of the remaining lifespan of transformers, resulting in significant improvements in prediction accuracy.

Abstract:Transformers are among the most important components in the energy grid due to their missions and high costs. The challenging operating conditions deteriorate their components and shorten the life of the transformers. The health index approach is a critical and effective method for monitoring transformers in the operating environment, early diagnosis of possible malfunctions, and evaluation of their general condition. DGA, OQA, and PIF parameters, which represent the condition of the insulation materials, which mainly determine the life of transformers, constitute the basic inputs of the health index approach. In this study, a new method was proposed to determine the DGAF score based on the dissolved gases in mineral oil. With this method, in addition to the delta and rate values of the gases, the past DGA results of the transformer were also considered in determining the DGAF. In this way, faults experienced during operation are included in the health index calculation. The proposed method was tested using 36 DGA results obtained over a period of approximately 10 years from a transformer operating in the grid. The obtained results are presented in comparison with the traditional DGAF scoring method.

Abstract:As integral components of any power plant, transformers sup-ply the generated electricity to the grid. However, the trans-former’s cellulose-based paper insulation and the mineral oilin which it is immersed break down over time under stan-dard operating conditions—or more rapidly due to potentialfaults within the system. This technical brief exhibits a col-lection of diagnostic and prognostic techniques that utilitiescan adopted in lieu of labor-intense periodic preventive main-tenance routines. Furthermore, prognostic models have beenincorporated using the latest version of the Institute of Elec-trical and Electronics Engineers (IEEE) standard (IEEE StdC57.104TM-2019) for dissolved gas analysis (DGA), thusexpanding it to include estimation of the time to maintenance.Overall, four different methodologies are explained, each ofwhich aid in determining a transformer’s state of health. Thesemethodologies include the Chendong model, the IEEE C57.91-2011 thermal life consumption model, a diagnostic model forDGA, and a prognostic model for DGA that uses an autore-gressive integrated moving average (ARIMA) model. An ad-ditional improvement for estimating missing system parame-ters from monitoring data (i.e., a tool for parameter estimationutilizing Powell’s method) is presented, enabling the IEEEthermal life consumption model to benefit not only the col-laborating power plant, but also the power industry at large.

Abstract:Power transformers are one of the most important and expensive equipment in power systems which could be affected by electrical stresses such as traveling waves, switching and thermal stresses such as overload and chemical reactions in dielectric oil. The DGA index expresses the dissolved gases generated due to faults in the transformer oil. The oil quality index determines the effect of electrical, physical and chemical parameters of transformer oil. Oil quality and DGA indices are important in determining the transformer health index. In this paper, the principal components analysis method used to determine the weight coefficients of DGA and oil quality indices. Also, the modes determined by CIGRE technical brochure 761 are used to calculate the mentioned indices. Then, the transformer is considered as a second-order system, and the mentioned indices are determined as parameters of the damping coefficient and natural frequency related to the mass-spring-damper model of the second-order system. Using state space matrices, the transformer system matrix of the second-order system is determined. Finally, the transformer health index is calculated using the ratio of the infinity norm matrix of the new transformer system to the infinity norm matrix of the worked transformer system.
