A physics-informed neural network that considers monotonic relationships for predicting NO x emissions from coal-fired boilers

Abstract:Nitrogen oxides (NO x ) are major pollutants emitted from coal-fired power plants. Accurately predicting the NO x concentration at the boiler outlet is crucial for optimizing unit control and reducing NO x emissions. Machine learning (ML) methods have been widely employed to predict NO x emissions from coal-fired boilers. However, the interpretability and generalizability of ML models are constrained by the absence of physical insights. To overcome this limitation, we introduce a physics-informed neural network (PINN) that embeds three typical monotonic relationships into the NO x prediction model by combining regression error, regularization, and physical inconsistency for joint training. The results for a 660-MW ultra-supercritical boiler reveal that the developed PINN method outperforms the other three traditional pure-regression ML methods (RF, DNN, LSSVR) regarding prediction accuracy. Moreover, additional field experiments demonstrate that the PINN model exhibits robust generalization capabilities when predicting NO x emissions under new operating conditions. This study highlights the benefits of using reliable physical information to improve the scientific interpretability and extrapolability of an ML model.
