Abstract:First-principles calculations have been combined with machine learning in the design of transition-metal single-atom catalysts. Readily available descriptors are selected to describe the nitrogen activation capability of metals and coordinating atoms. Thus, a series of V/Nb/Ta-Nx single-atom catalysts are screened out as promising structures upon considering the stability, activity, and selectivity investigated computationally. Furthermore, by using the gradient boosting regression algorithm, an accurate prediction of the hydrogenation barriers for the nitrogen reduction reaction (NRR) is achievable, with a root-mean-squared error of 0.07 eV. The integration of high-throughput computation and machine learning constitutes a powerful strategy for the acceleration of catalyst design. This approach facilitates the rapid and accurate prediction of the NRR performance of more than 1000 single-atom catalyst structures. Moreover, the current work provides further insights by elaborately correlating the structure and performance, which may be instructive for both the design and application of vanadium-group catalysts.

Abstract:The discovery of the Haber-Bosch process in the early 20th century facilitated the industrial synthesis of ammonia, thereby making a substantial contribution to the evolution of human society. Currently, towards a carbon-free economy, the electrocatalytic reduction of nitrogen (NRR) offers a promising, alternative technology to produce ammonia under mild conditions, given that it is a clean process without discernible environmental impact. However, despite significant efforts to construct superior catalysts and efficient reaction systems, the reaction rate and faraday efficiency for ammonia production remain well below the industrial threshold, primarily due to the difficulty in breaking N = N bonds. Theoretical studies provide important support for fundamental understanding of the catalytic mechanism and electrocatalytic process, so as to carry out more reasonable and orientated design of reaction systems. In the present review, we focus on the theoretical and computational research developments in electrocatalytic NRR systems from a theoretical perspective at multiple scales, including DFT studies at the electronic level, thermodynamics and dynamics at the molecular level and machine learning at the big-data level. Hopefully, the guiding significance for practical applications may help to comprehensively understand the NRR process and accelerate the improvement of NRR production efficiency.
Rational Design Synergistic Metal-Free Dual-Atom Electrocatalyst for N2 to NH3 Reaction on G-Cn: A First Principle Study

Abstract:The electrocatalytic nitrogen reduction reaction (NRR) for ammonia production is promising for N-2 fixation under ambient conditions. Most of the previous studies focus on transition metal-based catalysts, while the metal-free-based ones have not gotten enough attention. We designed dual-site metal-free atoms anchored on g-CN for electrocatalytic NRR based on the density functional theory (DFT) calculation. Results indicated that the B and P atoms co-doped g-CN system exhibits excellent NRR performance with a low limiting potential of -0.18 V, superior to most metal-based catalysts. In addition, a synergistic effect induced by the hybridization of B and P atoms is proposed. Eventually, the selectivity, thermodynamical stability, and conductivity are investigated. All of these modulations make the B-P@g-CN an excellent electrocatalyst. Our work provides a novel method for electrocatalytic NRR to ammonia and promotes the development of NRR.

Abstract:In this work, we provide a computational methodological framework using the single-atom systems as an example material class for ammonia synthesis that is robust towards parameter selection. Applying this to Pt$_1$/g-C$_3$N$_4$, Ru$_1$/g-C$_3$N$_4$, and Fe$_1$/g-C$_3$N$_4$, we generate ensembles of limiting potentials, using the ensemble of functionals collected via Bayesian Error Estimation Functionals (BEEF), to robustly predict catalytic activity. We then extend this to study the scaling between NRR reaction intermediates and use it to identify that NNH* as the best descriptor for these relations. In addition, a procedure to investigate selectivity is outlined, and a more robust way to analyze the selectivity-activity trade-off is presented. For this single-atom material class, we find choosing catalysts that lie on the strong binding leg of the activity volcano are worth further exploration. Given the ease of integration of the proposed method with minimal additional computational cost, we believe this should become a routine part of analysis workflow for multi-electron electrochemical reactions.

Abstract:Electrochemical NO reduction reaction (NORR) toward NH3 synthesis emerges as a promising approach to eliminate NO pollution and generate high-value-added products simultaneously. Therefore, exploring suitable NORR electrocatalysts is of great importance. Here, we present a design principle to evaluate the activity of single-atom alloy catalysts (SAACs), whose excellent catalytic performance and well-defined bonding environments make them suitable candidates for studying structure-activity relationships. The machine learning (ML) algorithm is chosen to unveil the underlying physics and chemistry. The results indicate that the catalytic activity of SAACs is highly correlated with the local environment of the active center, that is, the atomic and electronic features. The coeffect of these features is quantitatively verified by adopting a data-driven method. The combination of density functional theory (DFT) and ML investigations not only provides an understanding of the complex NORR mechanisms but also offers a strategy to design highly efficient SAACs with specific active centers rationally.
p‐d Orbital Hybridization Engineered Single‐Atom Catalyst for Electrocatalytic Ammonia Synthesis

Abstract:The rational design of metal single‐atom catalysts (SACs) for electrochemical nitrogen reduction reaction (NRR) is challenging. Two‐dimensional metal‐organic frameworks (2DMOFs) is a unique class of promising SACs. Up to now, the roles of individual metals, coordination atoms, and their synergy effect on the electroanalytic performance remain unclear. Therefore, in this work, a series of 2DMOFs with different metals and coordinating atoms are systematically investigated as electrocatalysts for ammonia synthesis using density functional theory calculations. For a specific metal, a proper metal‐intermediate atoms p‐d orbital hybridization interaction strength is found to be a key indicator for their NRR catalytic activities. The hybridization interaction strength can be quantitatively described with the p‐/d‐ band center energy difference (∆d‐p) which is found to be a sufficient descriptor for both the p‐d hybridization strength and the NRR performance. The maximum free energy change (ΔGmax) and ∆d‐p have a volcanic relationship with OsC4(Se)4 located at the apex of the volcanic curve, showing the best NRR performance. The asymmetrical coordination environment could regulate the band structure subtly in terms of band overlap and positions. This work may shed new light on the application of orbital engineering in electrocatalytic NRR activity and especially, promotes the rational design for SACs.

Abstract:To rationally locate the high-performance atomically dispersed catalyst remains a challenge, albeit wide explorations in numerous critical chemical reactions. Here, taking the cohesive-energy property of metal (Ec) as the descriptor, we systematically established the activity/selectivity/stability trends of the single- (SAS), double- (DAS) and triple-atom (TAS) structures for electrochemical nitrogen reduction reaction (NRR). Results show that TAS exhibits overall more superior NRR performance compared with others, revealing its essential structural superiority. The origin of the superior activity of TAS can be traced to the weakened adsorption strength of key intermediate NH2 that significantly activates the rate-limiting step of *NH2 hydrogenation. More importantly, we computationally explore 736 TAS catalysts via the on-the-fly oriented design driven by the genetic-algorithm-based global optimization method, and 146 candidates are extracted to enable NNR and recommended for experimental synthesis. By counting up these promising TAS, one general rule, i.e., early transition metal atoms combining with late ones, was identified to design the feasible composition pattern of TAS for NRR. This work deepens the fundamental understanding of the dependence of structural units on the catalytic ability for atomically dispersed metal catalysts, and the large-scale triple atom material exploration may accelerate the practical application for NRR or other systems.

Composition Engineering Opens an Avenue towards Efficient and Sustainable Nitrogen Fixation

Abstract:In this work, we open an avenue towards rational design of potential efficient catalysts for sustainable ammonia synthesis through composition engineering strategy by exploiting the synergistic effects among the active sites as exemplified by diatomic metals anchored graphdiyne via the combination of hierarchical high‐throughput screening, first‐principles calculations, and molecular dynamics simulations. Totally 43 highly efficient catalysts feature ultralow onset potentials (|Uonset| ≤ 0.40 V) with Rh‐Hf and Rh‐Ta showing negligible onset potentials of 0 and ‐0.04 V, respectively. Extremely high catalytic activities of Rh‐Hf and Rh‐Ta can be ascribed to the synergistic effects. When forming heteronuclears, the combinations of relatively weak (such as Rh) and relatively strong (such as Hf or Ta) components usually lead to the optimal strengths of adsorption Gibbs free energies of reaction intermediates. The origin can be ascribed to the mediate d‐band centers of Rh‐Hf and Rh‐Ta, which lead to the optimal adsorption strengths of intermediates, thereby bringing the high catalytic activities. Our work provides a new and general strategy towards the architecture of highly efficient catalysts not only for electrocatalytic nitrogen reduction reaction (eNRR), but also for other important reactions. We expect that our work will boost both experimental and theoretical efforts in this direction.

Abstract:Efficient and selective dehydrogenation of formic acid is a key challenge for a fuel-cell-based hydrogen economy. Though the development of heterogeneous catalysts has received much progress, their catalytic activity remains insufficient. Moreover, the design principle of such catalysts are still unclear. Here, experimental and theoretical studies on a series of mono-/bi-metallic nanoparticles supported on a NH2-N-rGO substrate are combined for formic acid dehydrogenation where the surface energy of a metal is taken as a relevant indicator for the adsorption ability of the catalyst for guiding catalyst design. The AuPd/NH2-N-rGO catalyst shows record catalytic activity by reducing the energy barrier of rate controlling steps of formate adsorption and hydrogen desorption. The obtained excellent results both in experiments and simulations could be extended to other important systems, providing a general guideline to design more efficient catalysts.
A Universal Descriptor for Complicated Interfacial Effects on Electrochemical Reduction Reactions.

Abstract:Supported catalysts have exhibited excellent performance in various reactions. However, the rational design of supported catalysts with high activity and certain selectivity remains a great challenge because of the complicated interfacial effects. Using recently emerged two-dimensional materials supported dual-atom catalysts (DACs@2D) as a prototype, we propose a simple and universal descriptor based on inherent atomic properties (electronegativity, electron type, and number), which can well evaluate the complicated interfacial effects on the electrochemical reduction reactions (i.e., CO2, O2, and N2 reduction reactions). Based on this descriptor, activity and selectivity trends in CO2 reduction reaction are successfully elucidated, in good agreement with available experimental data. Moreover, several potential catalysts with superior activity and selectivity for target products are predicted, such as CuCr/g-C3N4 for CH4 and CuSn/N-BN for HCOOH. More importantly, this descriptor can also be extended to evaluate the activity of DACs@2D for O2 and N2 reduction reactions, with very small errors between the prediction and reported experimental/computational results. This work provides feasible principles for the rational design of advanced electrocatalysts and the construction of universal descriptors based on inherent atomic properties.
Nano-Single-Atom Heterointerface Engineering for Ph-Universal Electrochemical Nitrate Reduction to Ammonia

Abstract:Nano-single-atom-catalysts have the potential to combine the respective advantages of both nano-catalysts and single-atom-catalysts and thus exhibit enhanced performance. Generally, the separation of active sites in space limits the interaction between single atoms and nanoparticles. Heterointerface engineering has the potential to break this limitation. Regretfully, studies on the interface effect between single atoms and nanoparticles are rarely reported. Herein, an unprecedented nano-single-atom heterointerface composed of Fe single-atoms and carbon-shell-coated FeP nanoparticles (Fe SAC/FeP@C) is demonstrated as an efficient electrocatalyst for the nitrate reduction process from alkaline to acidic. Compared with typical nano-single-atom-catalysts (Fe SAC/FePO4) and single-atom-catalysts (Fe SAC), the constructed Fe SAC/FeP@C heterostructure exhibits dramatically enhanced nitrate-to-ammonia performance. Especially in acidic media, the maxmium Faradaic efficiency of ammonia (NH3) can reach 95.6 +/- 0.5%, with a maximum NH3 yield of 36.2 +/- 3.1 mg h-1 mgcat-1 (pH = 1.2), which is considerably higher than previously reported. Density functional theory calculations and in situ spectroscopic investigations indicate that the unique charge redistribution at the interface, together with the optimized electronic structure of Fe single-atoms, strengthens intermediate adsorption and catalytic activity. This work provides a feasible strategy for designing nano-single-atom-catalysts with unique heterointerfaces, as well as valuable insights into nitrate conversion under environmentally relevant wastewater conditions. A unique nano-single-atom heterostructure is constructed for pH-universal nitrate-to-ammonia reduction reaction (especially in strong acidic media). Controlled experiments and mechanistic studies demonstrate that the unique charge redistribution at the interface, together with the optimized electronic structure of active centers, strengthens intermediate adsorption and makes it one of the most effective catalysts to date. image

Abstract:Electrochemical nitrate reduction is a promising route for sustainable green ammonia (NH3) synthesis, yet the efficiency is limited by its sluggish kinetics and complex reaction pathways. Here we report three types of single-atomic site catalysts (SASCs) with well-defined Cu centers to electrochemically catalyze nitrate reduction, and demonstrate superior catalytic performances. Under appropriate applied potentials, the three Cu SASCs reached > 80 % NH3 selectivity and maintained long-term stability. The extraordinary catalytic performance is attributed to the abundant atomically isolated Cu sites with unique N-coordinated environments. Our work provided insights to the rational design of single-atomic sites for high-efficiency electrochemical NH3 production.
Descriptor-Based Design Principle for Two-Dimensional Single-Atom Catalysts: Carbon Dioxide Electroreduction.

Abstract:Single-atom catalysis has recently emerged as a promising approach for catalyzing the carbon dioxide reduction reaction (CO2RR). In this study, we present a principle for designing active single-atom catalysts (SACs) for CO2RR. We systematically examine totally 24 transition metals supported by a graphitic carbon nitride (g-CN) monolayer and find that their catalytic activities are highly correlated with the adsorption free energies of two intermediate species (OH and OCH). We then identify two important intrinsic descriptors, namely, the number of electrons in the outmost d-shell and the enthalpy of vaporization of the transition metal. Test calculations on transition metals supported by a C2N monolayer indicate that both descriptors are quite universal for SACs of CO2RR. Based on these results, we show that Ni@g-CN, Cu@g-CN, and Co@C2N are promising SACs for CO2RR. This study offers an effective principle for designing highly active SACs for CO2RR on the basis of intrinsic properties of transition metals.
Progress and Challenges Toward the Rational Design of Oxygen Electrocatalysts Based on a Descriptor Approach

Abstract:Oxygen redox catalysis, including the oxygen reduction reaction (ORR) and oxygen evolution reaction (OER), is crucial in determining the electrochemical performance of energy conversion and storage devices such as fuel cells, metal-air batteries,and electrolyzers. The rational design of electrochemical catalysts replaces the traditional trial-and-error methods and thus promotes the R&D process. Identifying descriptors that link structure and activity as well as selectivity of catalysts is the key for rational design. In the past few decades, two types of descriptors including bulk- and surface-based have been developed to probe the structure-property relationships. Correlating the current descriptors to one another will promote the understanding of the underlying physics and chemistry, triggering further development of more universal descriptors for the future design of electrocatalysts. Herein, the current benchmark activity descriptors for oxygen electrocatalysis as well as their applications are reviewed. Particular attention is paid to circumventing the scaling relationship of oxygen-containing intermediates. For hybrid materials, multiple descriptors will show stronger predictive power by considering more factors such as interface reconstruction, confinement effect, multisite adsorption, etc. Machine learning and high-throughput simulations can thus be crucial in assisting the discovery of new multiple descriptors and reaction mechanisms.

Abstract:<p>Atomically dispersed metal-based electrocatalysts have attracted increasing attention due to their nearly 100% atomic utilization and excellent catalytic performance. However, current fundamental comprehension and summaries to reveal the underlying relationship between single-atom site electrocatalysts (SACs) and corresponding catalytic application are rarely reported. Herein, the fundamental understandings and intrinsic mechanisms underlying SACs and corresponding electrocatalytic applications are systemically summarized. Different preparation strategies are presented to reveal the synthetic strategies with engineering the well-defined SACs on the basis of theoretical principle (size effect, metal–support interactions, electronic structure effect, and coordination environment effect). Then, an overview of the electrocatalytic applications is presented, including oxygen reduction reaction, hydrogen evolution reaction, oxygen evolution reaction, oxidation of small organic molecules, carbon dioxide reduction reaction, and nitrogen reduction reaction. The underlying structure–performance relationship between SACs and electrocatalytic reactions is also discussed in depth to expound the enhancement mechanisms. Finally, a summary is provided and a perspective supplied to demonstrate the current challenges and opportunities for rational designing, synthesizing, and modulating the advanced SACs toward electrocatalytic reactions.</p>

Abstract:Atomic transition metal–nitrogen–carbon electrocatalysts exhibit outstanding activity in various electrocatalytic reactions. The challenge lies in predicting the structure of the active center, which may undergo changes under applied potential and interact with reactants or intermediates. Advanced characterization techniques, particularly in-situ X-ray absorption spectroscopy (XAS), provide crucial insights into the structural evolution of the metal active center during the reaction. In this study, nitrate reduction to ammonia (NO 3 RR) was selected as a model reaction, and we introduced in-situ XAS to reveal the structural evolution during the catalytic process. A novel single atom catalyst of iron loaded on three-dimensional nitrogen-carbon nanonetwork (designated as Fe SAC/NC) was successfully synthesized. We unraveled the structural transformations occurring as pyrrole-N 4 -Fe transitions to pyrrole-N 3 -Fe throughout the NO 3 RR process. Notably, the Fe SAC/NC catalyst exhibited excellent catalytic activity, achieving a Faradaic efficiency of 98.2% and an ammonia generation rate of 22,515 μg·h −1 ·mg cat −1 at −0.8 V versus reversible hydrogen electrode. Theoretical calculations combined with in-situ spectroscopic characterization showed that pyrrole-N 3 -Fe reduced the energy barrier from *NO to *NHO and improved the selectivity of ammonia. This provides a robust reference for the design of efficient nitrate-to-ammonia synthesis catalysts.

Abstract:Ammonia (NH 3 ) is the second-most produced chemical with broad applications and vital for the chemical industry. However, the current Haber–Bosch synthesis is problematic with high energy consumption and carbon footprints. Electrochemical nitrate reduction (NO 3 RR) to produce NH 3 is a green, low-carbon and efficient alternative route to simultaneously benefit wastewater treatment, mild NH 3 production and global warming mitigation. Compared to noble metal catalysts or the nanosized counterparts, iron single-atom catalysts (Fe SACs) boast unique advantages to promote the NO 3 RR because of the exceptional selectivity, inexpensiveness, high efficiency and good durability. Due to the rapid development of the emerging field, a timely Perspective with an emphasis on the recent advances in Fe SACs-catalyzed NO 3 RR is currently lacking. The Perspective aims to give an account of the up-to-date progresses on Fe SACs-promoted NO 3 RR for NH 3 production. The catalyst design, characterizations, mechanism studies, etc. will be illustrated, and lastly the challenges and outlook will be discussed to provide insights for future studies.
