Abstract:Approximating kernel functions with random features (RFs) has been a successful application of random projections for nonparametric estimation. However, performing random projections presents computational challenges for large-scale problems. Recently, a new optical hardware called Optical Processing Unit (OPU) has been developed for fast and energy-efficient computation of large-scale RFs in the analog domain. More specifically, the OPU performs the multiplication of input vectors by a large random matrix with complexvalued i.i.d. Gaussian entries, followed by the application of an element-wise squared absolute value operation – this last nonlinearity being intrinsic to the sensing process. In this paper, we show that this operation results in a dot-product kernel that has connections to the polynomial kernel, and we extend this computation to arbitrary powers of the feature map. Experiments demonstrate that the OPU kernel and its RF approximation achieve competitive performance in applications using kernel ridge regression and transfer learning for image classification. Crucially, thanks to the use of the OPU, these results are obtained with time and energy savings.
Sketch and shift: a robust decoder for compressive clustering

Abstract:Compressive learning is an emerging approach to drastically reduce the memory footprint of large-scale learning, by first summarizing a large dataset into a low-dimensional sketch vector, and then decoding from this sketch the latent information needed for learning. In light of recent progress on information preservation guarantees for sketches based on random features, a major objective is to design easy-to-tune algorithms (called decoders) to robustly and efficiently extract this information. To address the underlying non-convex optimization problems, various heuristics have been proposed. In the case of compressive clustering, the standard heuristic is CL-OMPR, a variant of sliding Frank-Wolfe. Yet, CL-OMPR is hard to tune, and the examination of its robustness was overlooked. In this work, we undertake a scrutinized examination of CL-OMPR to circumvent its limitations. In particular, we show how this algorithm can fail to recover the clusters even in advantageous scenarios. To gain insight, we show how the deficiencies of this algorithm can be attributed to optimization difficulties related to the structure of a correlation function appearing at core steps of the algorithm. To address these limitations, we propose an alternative decoder offering substantial improvements over CL-OMPR. Its design is notably inspired from the mean shift algorithm, a classic approach to detect the local maxima of kernel density estimators. The proposed algorithm can extract clustering information from a sketch of the MNIST dataset that is 10 times smaller than previously.

Signal processing after quadratic random sketching with optical units

Abstract:Random data sketching (or projection) is now a classical technique enabling, for instance, approximate numerical linear algebra and machine learning algorithms with reduced computational complexity and memory. In this context, the possibility of performing data processing (such as pattern detection or classification) directly in the sketched domain without accessing the original data was previously achieved for linear random sketching methods and compressive sensing. In this work, we show how to estimate simple signal processing tasks (such as deducing local variations in a image) directly using random quadratic projections achieved by an optical processing unit. The same approach allows for naive data classification methods directly operated in the sketched domain. We report several experiments confirming the power of our approach.

Abstract:Ever-growing deep-learning technologies are making revolutionary changes for modern life.However,conventional computing architectures are designed to process sequential and digital programs but are burdened with performing massive parallel and adaptive deep-learning applications.Photonic integrated circuits provide an efficient approach to mitigate bandwidth limitations and the power-wall brought on by its electronic counterparts,showing great potential in ultrafast and energy-free high-performance computation.Here,we propose an optical computing ar-chitecture enabled by on-chip diffraction to implement convolutional acceleration,termed"optical convolution unit"(OCU).We demonstrate that any real-valued convolution kernels can be exploited by the OCU with a promi-nent computational throughput boosting via the concept of structral reparameterization.With the OCU as the fundamental unit,we build an optical convolutional neural network(oCNN)to implement two popular deep learn-ing tasks:classification and regression.For classification,Fashion Modified National Institute of Standards and Technology(Fashion-MNIST)and Canadian Institute for Advanced Research(CIFAR-4)data sets are tested with accuracies of 91.63％and 86.25％,respectively.For regression,we build an optical denoising convolutional neural network to handle Gaussian noise in gray-scale images with noise level σ=10,15,and 20,resulting in clean images with an average peak signal-to-noise ratio(PSNR)of 31.70,29.39,and 27.72 dB,respectively.The proposed OCU presents remarkable performance of low energy consumption and high information density due to its fully passive nature and compact footprint,providing a parallel while lightweight solution for future compute-in-memory architecture to handle high dimensional tensors in deep learning.

Abstract:Large scale parallel computing under cluster system is the foundation for high performance computing.The enhancement of the efficiency of remote sensing image processing depends on the application of parallel computing technology.This article,on the basis of analyzing distributed task assignment approaches under the existing grid computing environment,aiming at the sparse characteristics of ocean remote sensing image objects,from the software aspect,first of all uses the quadtree structure idea to segment object areas,while at the same time uses the dynamic load balancing task assignment policy and parallel computing thought to present a cluster system task assignment algorithm processing model for object area image fusion processing.By comparative validation the algorithm model under that cluster system is proven to be effective at speeding up image fusion.

Abstract:Graph-based neural networks have promising perspectives but are limited by electronic bottlenecks. Our work explores the advantages of optical neural networks in the graph domain. We propose an optical graph neural network (OGNN) based on inverse-designed optical processing units (OPUs) to classify graphs with optics. The OPUs, combined with two types of optical components, can perform multiply-accumulate, matrix-vector multiplication, and matrix-matrix multiplication operations. The proposed OGNN can classify typical non-Euclidean MiniGCDataset graphs and successfully predict 1000 test graphs with 100% accuracy. The OPU-formed optical-electrical graph attention network is also scalable to handle more complex graph data, such as the Cora dataset, with 89.0% accuracy.
Compressed Subspace Clustering: A Case Study

Abstract:Subspace clustering possesses a wide range of applications, including network data analysis, image segmentation, and medical image processing, etc. Aimed at reducing the computational complexity of subspace clustering performed on high-dimensional data, we propose a compressed subspace clustering approach by random projection. From the view of subspace principal angles, we analyze the subspace affinity change brought by compression, and provide an estimate of compressed subspace affinity when the embedded subspaces share a certain number of intersected dimensions with all other dimensions orthogonal pairwisely. In such condition, a lower bound on compressed dimensionality is also theoretically proved in this paper. Our results show that the raw data can be compressed to very few measurements yet will remain high subspace separability. Numerical simulations validate the above theoretical results.

Abstract:We provide statistical learning guarantees for two unsupervised learning tasks in the context of compressive statistical learning, a general framework for resource-efficient large-scale learning that we introduced in a companion <a class="link-external link-http" href="http://paper.The" rel="external noopener nofollow">this http URL</a> principle of compressive statistical learning is to compress a training collection, in one pass, into a low-dimensional sketch (a vector of random empirical generalized moments) that captures the information relevant to the considered learning task. We explicitly describe and analyze random feature functions which empirical averages preserve the needed information for compressive clustering and compressive Gaussian mixture modeling with fixed known variance, and establish sufficient sketch sizes given the problem dimensions.

Abstract:Parallel technology boosts data processing in recent years, and parallel direct data processing on hierarchically compressed documents exhibits great promise. The high-performance direct data processing technique brings large savings in both time and space by removing the need for decompressing data. However, its benefits have been limited to data traversal operations; for random accesses, direct data processing is several times slower than the state-of-the-art baselines. This article proposes a novel concept, orthogonal processing on compression (orthogonal POC), which means that text analytics can be efficiently supported directly on compressed data, regardless of the type of the data processing – that is, the type of data processing is orthogonal to its capability of conducting POC. Previous proposals, such as TADOC, are not orthogonal POC. This article presents a set of techniques that successfully eliminate the limitation, and for the first time, establishes the near orthogonal POC feasibility of effectively handling both data traversal operations and random data accesses on hierarchically-compressed data. The work focuses on text data and yields a unified high-performance library, called POCLib. In a ten-node distributed Spark cluster on Amazon EC2, POCLib achieves 3.1× speedup over the state-of-the-art on random data accesses to compressed data, while preserving the capability of supporting traversal operations efficiently and providing large (3.9×) space savings.

Abstract:Dimension reduction is widely regarded as an effective way for decreasing the computation, storage, and communication loads of data-driven intelligent systems, leading to a growing demand for statistical methods that allow analysis (e.g., clustering) of compressed data. We therefore study in this paper a novel problem called compressive robust subspace clustering, which is to perform robust subspace clustering with the compressed data, and which is generated by projecting the original high-dimensional data onto a lower-dimensional subspace chosen at random. Given only the compressed data and sensing matrix, the proposed method, row space pursuit (RSP), recovers the authentic row space that gives correct clustering results under certain conditions. Extensive experiments show that RSP is distinctly better than the competing methods, in terms of both clustering accuracy and computational efficiency.
Realization of Hybrid Compressive Imaging Strategies.

Abstract:The tendency of natural scenes to cluster around low frequencies is not only useful in image compression, it also can prove advantageous in novel infrared and hyperspectral image acquisition. In this paper, we exploit this signal model with two approaches to enhance the quality of compressive imaging as implemented in a single-pixel compressive camera and compare these results against purely random acquisition. We combine projection patterns that can efficiently extract the model-based information with subsequent random projections to form the hybrid pattern sets. With the first approach, we generate low-frequency patterns via a direct transform. As an alternative, we also used principal component analysis of an image library to identify the low-frequency components. We present the first (to the best of our knowledge) experimental validation of this hybrid signal model on real data. For both methods, we acquire comparable quality of reconstructions while acquiring only half the number of measurements needed by traditional random sequences. The optimal combination of hybrid patterns and the effects of noise on image reconstruction are also discussed.
Compressive Sensing for cut improvement and local clustering

Abstract:We show how one can phrase the cut improvement problem for graphs as a sparse recovery problem, whence one can use algorithms originally developed for use in compressive sensing (such as SubspacePursuit or CoSaMP) to solve it. We show that this approach to cut improvement is fast, both in theory and practice and moreover enjoys statistical guarantees of success when applied to graphs drawn from probabilistic models such as the Stochastic Block Model. Using this new cut improvement approach, which we call ClusterPursuit, as an algorithmic primitive we then propose new methods for local clustering and semi-supervised clustering, which enjoy similar guarantees of success and speed. Finally, we verify the promise of our approach with extensive numerical benchmarking.

Orthogonal Matching Pursuit with Adaptive Restriction for Sparse Subspace Clustering

Abstract:Subspace clustering methods have been used for unsupervised learning and Sparse Subspace Clustering (SSC) is one of the most popular methods. Since ℓ1 optimization in SSC requires complex calculation, Orthogonal Matching Pursuit (OMP) is adopted in OMP-SSC to reduce calculation time, but its performance is unsatisfactory. In this paper, a new algorithm, Orthogonal Matching Pursuit with Adaptive Restriction for Sparse Subspace Clustering (OMPAR-SSC) is proposed, in which two adaptive restrictions varying with the strength or density of connections are developed. Our algorithm can improve the connectivity of the affinity graph and enhance the segmentation effect. Experiments on both synthetic data and real-world data also demonstrate that OMPAR-SSC outperforms other subspace clustering algorithms in terms of accuracy and achieves a good trade-off between efficiency and effectiveness.
Diffraction‐Driven Parallel Convolution Processing with Integrated Photonics

Abstract:AbstractTraditional electronic processors often struggle with bandwidth limitations and high power consumption when executing extensive linear operations for deep learning tasks. Optical computing has emerged as a promising alternative, offering parallel and energy‐efficient computation capabilities. Yet, the development of high‐density optical computing architectures on integrated photonic platforms remains limited, hindered by constraints in neuron scalability and control engineering complexities. Addressing these challenges, this work presents a diffraction‐driven multi‐kernel optical convolution unit (MOCU) that enables on‐chip parallel convolution processing. By utilizing cascaded silica 1D metalines as pre‐trained large‐scale weights and employing spatial multiplexing at the output, MOCU allows simultaneous passive computation of diverse convolutions within a single unit. This architecture facilitates the construction of optical convolutional neural networks (OCNNs), enabling efficient machine vision processing with a streamlined design. To mitigate errors in MOCU‐embedded OCNNs, a lightweight electronic neural network operates concurrently to calibrate systematic deviations via a low‐rank adaptation (LoRA) algorithm, with minimal overhead. The fabricated MOCU chip demonstrates the highest independent 8‐kernel convolutions in parallel, each with a kernel size and occupying just 0.06 . This architecture effectively merges photonic and electronic technologies, offering a scalable design pathway for energy‐efficient, high‐density deep learning hardware.

Abstract:The measurement matrix in compressive imaging controls the crucial feature information for high performance recognition. In this study, a deterministic orthogonal measurement matrix design method using the discrete cosine transform and a compressive feature selection scheme are proposed to implement high-end computational optics for imaging. The selection scheme systematically evaluates the recognition importance for the frequency features, combined with a scaling of the contribution of the various coefficients used to produce a base matrix for the new group of measuring patterns, which ensures the minimal recognition difference for each individual order of frequency filters and combining a relatively complex expression to quickly find the best quantization values. The model parameters are gradually adjusted and eventually converge to the best result through training with a large number of pre-determined samples from the dataset and backpropagating the feature selection loss along with the recognition loss, and the data processing capabilities can be enhanced because the measurement matrix is a priori information for the recognition phase. The systematic ability of the proposed technique was verified through simulations and experiments on two standard datasets: MNIST and CIFAR-10. The results show that the proposed method outperforms state-of-the-art methods in terms of both the model complexity and classification accuracy, which indicates that our study provides a new practical solution for compressive imaging recognition.
Multiresolution Graph Fourier Transform for Compression of Piecewise Smooth Images.

Abstract:Piecewise smooth (PWS) images (e.g., depth maps or animation images) contain unique signal characteristics such as sharp object boundaries and slowly varying interior surfaces. Leveraging on recent advances in graph signal processing, in this paper, we propose to compress the PWS images using suitable graph Fourier transforms (GFTs) to minimize the total signal representation cost of each pixel block, considering both the sparsity of the signal's transform coefficients and the compactness of transform description. Unlike fixed transforms, such as the discrete cosine transform, we can adapt GFT to a particular class of pixel blocks. In particular, we select one among a defined search space of GFTs to minimize total representation cost via our proposed algorithms, leveraging on graph optimization techniques, such as spectral clustering and minimum graph cuts. Furthermore, for practical implementation of GFT, we introduce two techniques to reduce computation complexity. First, at the encoder, we low-pass filter and downsample a high-resolution (HR) pixel block to obtain a low-resolution (LR) one, so that a LR-GFT can be employed. At the decoder, upsampling and interpolation are performed adaptively along HR boundaries coded using arithmetic edge coding, so that sharp object boundaries can be well preserved. Second, instead of computing GFT from a graph in real-time via eigen-decomposition, the most popular LR-GFTs are pre-computed and stored in a table for lookup during encoding and decoding. Using depth maps and computer-graphics images as examples of the PWS images, experimental results show that our proposed multiresolution-GFT scheme outperforms H.264 intra by 6.8 dB on average in peak signal-to-noise ratio at the same bit rate.
Union of Data-Driven Subspaces Via Subspace Clustering for Compressive Video Sampling

Abstract:The standard Compressive Sensing (CS) theory indicates that robust signals recovery can be obtained from just a few collection of incoherent projections. To further decrease the necessary measurements, an alternative to the generic CS framework assumes that signals lie on a union of subspaces (UoS). However, UoS model is limited to the specific type of signal regularity. This paper considers a more general and adaptive model which presumes that signals lie on a union of data-driven subspaces (UoDS). The UoDS model inherits the merit from UoS that signals have structural sparse representation. Meanwhile, it allows to recover signals using fewer degrees of freedom for a desirable recovery quality than UoS. To construct the UoDS model, a subspace clustering method is utilized to form an adaptive group set. The corresponding adaptive basis is learned by applying a linear subspace learning (LSL) method to each group. A corresponding recovery algorithm with provable performance is also given. Experiment results demonstrate that the proposed model for video sampling is valid and applicable.
Low tensor train and low multilinear rank approximations of 3D tensors for compression and de-speckling of optical coherence tomography images

Abstract:Objective. Many methods for compression and/or de-speckling of 3D optical coherence tomography (OCT) images operate on a slice-by-slice basis and, consequently, ignore spatial relations between the B-scans. Thus, we develop compression ratio (CR)-constrained low tensor train (TT)-and low multilinear (ML) rank approximations of 3D tensors for compression and de-speckling of 3D OCT images. Due to inherent denoising mechanism of low-rank approximation, compressed image is often even of better quality than the raw image it is based on.Approach. We formulate CR-constrained low rank approximations of 3D tensor as parallel non-convex non-smooth optimization problems implemented by alternating direction method of multipliers of unfolded tensors. In contrast to patch- and sparsity-based OCT image compression methods, proposed approach does not require clean images for dictionary learning, enables CR as high as 60:1, and it is fast. In contrast to deep networks based OCT image compression, proposed approach is training free and does not require any supervised data pre-processing.Main results. Proposed methodology is evaluated on twenty four images of a retina acquired on Topcon 3D OCT-1000 scanner, and twenty images of a retina acquired on Big Vision BV1000 3D OCT scanner. For the first dataset, statistical significance analysis shows that for CR ≤ 35, all low ML rank approximations and Schatten-0 (S0) norm constrained low TT rank approximation can be useful for machine learning-based diagnostics by using segmented retina layers. Also for CR ≤ 35,S0-constrained ML rank approximation andS0-constrained low TT rank approximation can be useful for visual inspection-based diagnostics. For the second dataset, statistical significance analysis shows that for CR ≤ 60 all low ML rank approximations as well asS0andS1/2low TT ranks approximations can be useful for machine learning-based diagnostics by using segmented retina layers. Also, for CR ≤ 60, low ML rank approximations constrained withSp,p∊ {0, 1/2, 2/3} and one surrogate ofS0can be useful for visual inspection-based diagnostics. That is also true for low TT rank approximations constrained withSp,p∊ {0, 1/2, 2/3} for CR ≤ 20.Significance. Studies conducted on datasets acquired by two different types of scanners confirmed capabilities of proposed framework that, for a wide range of CRs, yields de-speckled 3D OCT images suitable for clinical data archiving and remote consultation, for visual inspection-based diagnosis and for machine learning-based diagnosis by using segmented retina layers.
Processing and rendering of Fourier domain optical coherence tomography images at a line rate over 524 kHz using a graphics processing unit

Abstract:In Fourier domain optical coherence tomography (FD-OCT), a large amount of interference data needs to be resampled from the wavelength domain to the wavenumber domain prior to Fourier transformation. We present an approach to optimize this data processing, using a graphics processing unit (GPU) and parallel processing algorithms. We demonstrate an increased processing and rendering rate over that previously reported by using GPU paged memory to render data in the GPU rather than copying back to the CPU. This avoids unnecessary and slow data transfer, enabling a processing and display rate of well over 524,000 A-scan∕s for a single frame. To the best of our knowledge this is the fastest processing demonstrated to date and the first time that FD-OCT processing and rendering has been demonstrated entirely on a GPU.

Abstract:Abstract A raster time series is a sequence of independent rasters arranged chronologically covering the same geographical area. These are commonly used to depict the temporal evolution of represented variables. The $T$-$k^{2}$-raster is a compact data structure that performs very well in practice for compact representations for raster time series. This structure classifies each raster as a snapshot or a log and encodes logs concerning their reference snapshots, which are the immediately preceding selected snapshots. An enhanced version of the $T$-$k^{2}$-raster, called Heuristic $T$-$k^{2}$-raster, incorporates a heuristic for automating the selection of snapshots. In this study, we investigate the optimality of the heuristic employed in Heuristic $T$-$k^{2}$-raster by comparing it with a dynamic programming (DP) approach. Our experimental evaluation demonstrates that Heuristic $T$-$k^{2}$-raster is a near-optimal solution, achieving compression performance almost identical to the DP method. These results indicate that variations of the structure that maintain the temporal order of the rasters are unlikely to significantly improve compression. Consequently, we explore an alternative approach based on clustering, where rasters are grouped according to their similarity, regardless of their temporal order.
