Abstract:We consider the general problem of selling a limited inventory of items to heterogeneous customers who arrive sequentially, and analyze the competitive ratio under adversarial arrivals. Previous work in this area, motivated by online matching, advertising, and assortment problems, has considered the case where each item can be sold at only a single price. This work has culminated in two classes of algorithms: "balance'' algorithms, which achieve the best-possible competitive ratio of 1-1/e in an asymptotic large-inventory ("small bids") regime; and "ranking'' algorithms, which achieve the best-possible competitive ratio of 1-1/e in the deterministic case of online matching. In this paper, we extend both of these classes of results to allow for items to have multiple feasible prices. Our algorithms introduce the idea of "booking limits'' from revenue management and integrate them into the multiplicative penalty functions used for online matching and allocation problems. Our algorithms achieve the best-possible weight-dependent competitive ratios, which depend on the sets of feasible prices given in advance. To establish this tightness, we show that by optimizing our additive "value function'' used to make allocation decisions, the resulting objective value is the same as that of an adversary's optimization problem for designing a weighted upper-triangular graph. Our "balance'' algorithm and its analysis further use a randomly-perturbed version of this value function; aside from being asymptotically optimal, they improve the best-known dependence of the competitive ratio on the starting inventory amounts.

Abstract:In several applications of real-time matching of demand to supply in online marketplaces, the platform allows for some latency to batch the demand and improve the efficiency of the resulting matching. Motivated by these applications, we study the optimal trade-off between batching and inefficiency in the context of designing robust online allocations. As our base model, we consider K-stage variants of the classic vertex-weighted bipartite b-matching in the adversarial setting, where online vertices arrive stagewise and in K batches—in contrast to online arrival. Our main result for this problem is an optimal [Formula: see text]-competitive (fractional) matching algorithm, improving the classic [Formula: see text]-competitive ratio bound known for its online variant [Mehta A, Saberi A, Vazirani U, Vazirani V (2007) Ad words and generalized online matching. J. ACM 54(5):22–es; Aggarwal G, Goel G, Karande C, Mehta A (2011) Online vertex weighted bipartite matching and single-bid budgeted allocations. Proc. 22nd Annual ACM-SIAM Sympos. ACM Trans. Econom. Comput. 4(3):1–20], which is motivated by the display advertising application in the context of video streaming platforms. Our main technique at a high level is developing algorithmic tools to vary the trade-off between “greediness” and “hedging” of the matching algorithm across stages. We rely on a particular family of convex programming–based matchings that distribute the demand in a specifically balanced way among supply in different stages while carefully modifying the balancedness of the resulting matching across stages. More precisely, we identify a sequence of polynomials with decreasing degrees to be used as strictly concave regularizers of the maximum weight–matching linear program to form these convex programs. At each stage, our fractional multistage algorithm returns the corresponding regularized optimal solution as the matching of this stage (by solving the convex program). By providing structural decomposition of the underlying graph using the optimal solutions of these convex programs and recursively connecting the regularizers together, we develop a new multistage primal-dual framework to analyze the competitive ratio of this algorithm. We further show this algorithm is optimal competitive, even in the unweighted case, by providing an upper bound instance in which no online algorithm obtains a competitive ratio better than [Formula: see text]. For the extension to multistage configuration allocation, we introduce a novel extension of our regularized convex program that provides separate regularization at different “price levels.” Despite the lack of a relevant graph decomposition in this extension, in contrast to our base model, we show how we can directly use convex duality to set up a primal-dual analysis framework for our new algorithm. Exploring the Tradeoff between Competitive Ratio and Variance in Online-Matching Markets

Abstract:In this paper, we propose an online-matching-based model to study the assignment problems arising in a wide range of online-matching markets, including online recommendations, ride-hailing platforms, and crowdsourcing markets. It features that each assignment can request a random set of resources and yield a random utility, and the two (cost and utility) can be arbitrarily correlated with each other. We present two linear-programming-based parameterized policies to study the tradeoff between the \emph{competitive ratio} (CR) on the total utilities and the \emph{variance} on the total number of matches (unweighted version). The first one (SAMP) is to sample an edge according to the distribution extracted from the clairvoyant optimal, while the second (ATT) features a time-adaptive attenuation framework that leads to an improvement over the state-of-the-art competitive-ratio result. We also consider the problem under a large-budget assumption and show that SAMP achieves asymptotically optimal performance in terms of competitive ratio.

Abstract:Motivated by applications in cloud computing spot markets and selling banner ads on popular websites, we study the online resource allocation problem with overbooking and cancellation costs, also known as the \emph{buyback} setting. To model this problem, we consider a variation of the classic edge-weighted online matching problem in which the decision maker can reclaim any fraction of an offline resource that is pre-allocated to an earlier online vertex; however, by doing so not only the decision maker loses the previously allocated edge-weight, it also has to pay a non-negative constant factor $f$ of this edge-weight as an extra penalty. Parameterizing the problem by the buyback factor $f$, our main result is obtaining optimal competitive algorithms for \emph{all possible values} of $f$ through a novel primal-dual family of algorithms. We establish the optimality of our results by obtaining separate lower bounds for each of small and large buyback factor regimes and showing how our primal-dual algorithm exactly matches this lower bound by appropriately tuning a parameter as a function of $f$. Interestingly, our result shows a phase transition: for small buyback regime ($f<\frac{e-2}{2}$), the optimal competitive ratio is $\frac{e}{e-(1+f)}$, and for the large buyback regime ($f\geq \frac{e-2}{2}$), the competitive ratio is $-W_{-1}\left(\frac{-1}{e(1+f)}\right)$, where $W_{-1}$ is the non-principal branch of the Lambert W function. We further study the optimal competitive ratio in variants of this model using our unifying framework, such as matching with deterministic integral allocations or single-resource with different demands. For deterministic integral matching, our results again show a phase transition: for small buyback regime ($f<\frac{1}{3}$), the optimal competitive ratio is $\frac{2}{1-f}$, and for the large buyback regime ($f\geq \frac{1}{3}$), it is $1+2f+2\sqrt{f(1+f)}$.

Group-level Fairness Maximization in Online Bipartite Matching

Abstract:We consider the allocation of limited resources to heterogeneous customers who arrive in an online fashion. We would like to allocate the resources "fairly", so that no group of customers is marginalized in terms of their overall service rate. We study whether this is possible to do so in an online fashion, and if so, what a good online allocation policy is. We model this problem using online bipartite matching under stationary arrivals, a fundamental model in the literature typically studied under the objective of maximizing the total number of customers served. We instead study the objective of maximizing the minimum service rate across all groups, and propose two notions of fairness: long-run and short-run. For these fairness objectives, we analyze how competitive online algorithms can be, in comparison to offline algorithms which know the sequence of demands in advance. For long-run fairness, we propose two online heuristics (Sampling and Pooling) which establish asymptotic optimality in different regimes (no specialized supplies, no rare demand types, or imbalanced supply/demand). By contrast, outside all of these regimes, we show that the competitive ratio of online algorithms is between 0.632 and 0.732. For short-run fairness, we show for complete bipartite graphs that the competitive ratio of online algorithms is between 0.863 and 0.942; we also derive a probabilistic rejection algorithm which is asymptotically optimal in the total demand. Depending on the overall scarcity of resources, either our Sampling or Pooling heuristics could be desirable. The most difficult situation for online allocation occurs when the total supply is just enough to serve the total demand. We simulate our algorithms on a public ride-hailing dataset, which both demonstrates the efficacy of our heuristics and validates our managerial insights.

Abstract:Many efforts have been devoted to online pricing mechanism design for different settings. In this work, we consider a common but challenging setting where the buyers have private time-sensitive valuations and the seller has limited supply. The seller offers a take-it-or-leave-it posted price for each arriving buyer and aims to maximize the expected total revenue. The unknown distribution of time-sensitive valuations and limited supply significantly increase the difficulty of searching the optimal dynamic posted prices. Given B identical items to sell, when the time-dependent valuations can be estimated with a factor of α, we prove Ω(log(1/α)) lower bound with respect to the optimal fixed distribution over prices and design an algorithm achieving tight O(log(1/α)) competitive ratio. When the seller has no information about the future trends of buyers’ valuations, we prove Ω(log B) lower bound and show that there is an algorithm with tight O(log B) competitive ratio by modeling the problem as adversarial bandits with knapsacks optimization. Extensive simulation studies show that our algorithm outperforms previous mechanisms in various settings.

Abstract:We study a general problem of allocating limited resources to heterogeneous customers over time under model uncertainty. Each type of customer can be serviced using different actions, each of which stochastically consumes some combination of resources and returns different rewards for the resources consumed. We consider a general model in which the resource consumption distribution associated with each customer type–action combination is not known but is consistent and can be learned over time. In addition, the sequence of customer types to arrive over time is arbitrary and completely unknown. We overcome both the challenges of model uncertainty and customer heterogeneity by judiciously synthesizing two algorithmic frameworks from the literature: inventory balancing, which “reserves” a portion of each resource for high-reward customer types that could later arrive based on competitive ratio analysis, and online learning, which “explores” the resource consumption distributions for each customer type under different actions based on regret analysis. We define an auxiliary problem, which allows for existing competitive ratio and regret bounds to be seamlessly integrated. Furthermore, we propose a new variant of upper confidence bound (UCB), dubbed lazyUCB, which conducts less exploration in a bid to focus on “exploitation” in view of the resource scarcity. Finally, we construct an information-theoretic family of counterexamples to show that our integrated framework achieves the best possible performance guarantee. We demonstrate the efficacy of our algorithms on both synthetic instances generated for the online matching with stochastic rewards problem under unknown probabilities and a publicly available hotel data set. Our framework is highly practical in that it requires no historical data (no fitted customer choice models or forecasting of customer arrival patterns) and can be used to initialize allocation strategies in fast-changing environments. Abstract:We study generalizations of online bipartite matching in which each arriving vertex (customer) views a ranked list of offline vertices (products) and matches to (purchases) the first one they deem acceptable. The number of products that the customer has patience to view can be stochastic and dependent on the products seen. We develop a framework that views the interaction with each customer as an abstract resource consumption process, and derive new results for these online matching problems under the adversarial, non-stationary, and IID arrival models, assuming we can (approximately) solve the product ranking problem for each single customer. To that end, we show new results for product ranking under two cascade-click models: an optimal algorithm when each item has its own hazard rate for making the customer depart, and a 1/2-approximate algorithm when the customer has a general item-independent patience distribution. We also present a constant-factor 0.027-approximate algorithm in a new model where items are not initially available and arrive over time. We complement these positive results by presenting three additional negative results relating to these problems.

Abstract:We introduce a general model of resource allocation with customer choice. In this model, there are multiple resources that are available over a finite horizon. The resources are non-replenishable and perishable. Each unit of a resource can be instantly made into one of several products. There are multiple customer types arriving randomly over time. An assortment of products must be offered to each arriving customer, depending on the type of the customer, the time of arrival, and the remaining inventory. From this assortment, the customer selects a product according to a general choice model. The selection generates a product-dependent and customer-type-dependent reward. The objective of the system is to maximize the total expected reward earned over the horizon. The above problem has a number of applications, including personalized assortment optimization, revenue management of parallel flights, and web- and mobile-based appointment scheduling. We derive online algorithms that are asymptotically optimal and achieve the best constant relative performance guarantees for this class of problems.

A Nonparametric Framework for Online Stochastic Matching with Correlated Arrivals

Abstract:The design of online algorithms for matching markets and revenue management settings is usually bound by the stochastic prior that the demand process is formed by a fixed-length sequence of queries with unknown types, each drawn independently. This assumption of {\em serial independence} implies that the demand of each type, i.e., the number of queries of a given type, has low variance and is approximately Poisson-distributed. This paper explores more general stochastic models for online edge-weighted matching that depart from the serial independence assumption. We propose two new models, \Indep and \Correl, that capture different forms of serial correlations by combining a nonparametric distribution for the demand with standard assumptions on the arrival patterns -- adversarial or random order. The \Indep model has arbitrary marginal distributions for the demands but assumes cross-sectional independence for the customer types, whereas the \Correl model captures common shocks across customer types. We demonstrate that fluid relaxations, which rely solely on expected demand information, have arbitrarily bad performance guarantees. In contrast, we develop new algorithms that essentially achieve optimal constant-factor performance guarantees in each model. Our mathematical analysis includes tighter linear programming relaxations that leverage distribution knowledge, and a new lossless randomized rounding scheme in the case of $\Indep$. In numerical simulations of the $\Indep$ model, we find that tighter relaxations are beneficial under high-variance demand and that our demand-aware rounding scheme can outperform stockout-aware rounding.

Multi-agent Assortment Optimization in Sequential Matching Markets

Abstract:In this work, we study the multi-agent assortment optimization problem in the two-sided sequential matching model introduced by Ashlagi et al. (2022). The setting is the following: we (the platform) offer a menu of suppliers to each customer. Then, every customer selects, simultaneously and independently, to match with a supplier or to remain unmatched. Each supplier observes the subset of customers that selected them, and choose either to match a customer or to leave the system. Therefore, a match takes place if both a customer and a supplier sequentially select each other. Each agent's behavior is probabilistic and determined by a discrete choice model. Our goal is to choose an assortment family that maximizes the expected revenue of the matching. Given the hardness of the problem, we show a $1-1/e$-approximation factor for the heterogeneous setting where customers follow general choice models and suppliers follow a general choice model whose demand function is monotone and submodular. Our approach is flexible enough to allow for different assortment constraints and for a revenue objective function. Furthermore, we design an algorithm that beats the $1-1/e$ barrier and, in fact, is asymptotically optimal when suppliers follow the classic multinomial-logit choice model and are sufficiently selective. We finally provide other results and further insights. Notably, in the unconstrained setting where customers and suppliers follow multinomial-logit models, we design a simple and efficient approximation algorithm that appropriately randomizes over a family of nested-assortments. Also, we analyze various aspects of the matching market model that lead to several operational insights, such as the fact that matching platforms can benefit from allowing the more selective agents to initiate the matchmaking process.

Static Pricing for Online Selection Problem and its Variants

Abstract:This paper studies an online selection problem, where a seller seeks to sequentially sell multiple copies of an item to arriving buyers. We consider an adversarial setting, making no modeling assumptions about buyers' valuations for the items except acknowledging a finite support. In this paper, we focus on a class of static pricing algorithms that sample a price from a pre-determined distribution and sell items to buyers whose valuations exceed the sampled price. Such algorithms are of practical interests due to their advantageous properties, such as ease of implementation and non-discrimination over prices. Our work shows that the simple static pricing strategy can achieve strong guarantees comparable to the best known dynamic pricing algorithms. Particularly, we design the optimal static pricing algorithms for the adversarial online selection problem and its two important variants: the online assignment problem and the online selection with convex cost. The static pricing algorithms can even attain the optimal competitive ratios among all online algorithms for the online selection problem and the online assignment problem. To achieve these results, we propose an economics-based approach in the competitive analysis of static pricing algorithms, and develop a novel representative function-based approach to derive the lower bounds. We expect these approaches will be useful in related problems such as online matching.

Two-stage Stochastic Matching and Pricing with Applications to Ride Hailing

Abstract:Matching and pricing are two critical levers in two-sided marketplaces to connect demand and supply. The platform can produce more efficient matching and pricing decisions by batching the demand requests. We initiate the study of the two-stage stochastic matching problem, with or without pricing, to enable the platform to make improved decisions in a batch with an eye toward the imminent future demand requests. This problem is motivated in part by applications in online marketplaces such as ride hailing platforms. We design online competitive algorithms for vertex-weighted (or unweighted) two-stage stochastic matching for maximizing supply efficiency, and two-stage joint matching and pricing for maximizing market efficiency. In the former problem, using a randomized primal-dual algorithm applied to a family of ``balancing'' convex programs, we obtain the optimal $3/4$ competitive ratio against the optimum offline benchmark. Using a factor revealing program and connections to submodular optimization, we improve this ratio against the optimum online benchmark to $(1-1/e+1/e^2)\approx 0.767$ for the unweighted and $0.761$ for the weighted case. In the latter problem, we design optimal $1/2$-competitive joint pricing and matching algorithm by borrowing ideas from the ex-ante prophet inequality literature. We also show an improved $(1-1/e)$-competitive algorithm for the special case of demand efficiency objective using the correlation gap of submodular functions. Finally, we complement our theoretical study by using DiDi's ride-sharing dataset for Chengdu city and numerically evaluating the performance of our proposed algorithms in practical instances of this problem.

Abstract:Bipartite matching markets pair agents on one side of a market with agents, items, or contracts on the opposing side. Prior work addresses online bipartite matching markets, where agents arrive over time and are dynamically matched to a known set of disposable resources. In this paper, we propose a new model, Online Matching with (offline) Reusable Resources under Known Adversarial Distributions (OM-RR-KAD), in which resources on the offline side are reusable instead of disposable; that is, once matched, resources become available again at some point in the future. We show that our model is tractable by presenting an LP-based adaptive algorithm that achieves an online competitive ratio of 1/2 - eps for any given eps greater than 0. We also show that no non-adaptive algorithm can achieve a ratio of 1/2 + o(1) based on the same benchmark LP. Through a data-driven analysis on a massive openly-available dataset, we show our model is robust enough to capture the application of taxi dispatching services and ride-sharing systems. We also present heuristics that perform well in practice.

Abstract:In this paper, we study a general online linear programming problem whose formulation encompasses many practical dynamic resource allocation problems, including internet advertising display applications, revenue management, various routing, packing, and auction problems. We propose a model, which under mild assumptions, allows us to design near-optimal learning-based online algorithms that do not require the a priori knowledge about the total number of online requests to come, a first of its kind. We then consider two variants of the problem that relax the initial assumptions imposed on the proposed model.

Abstract:Consumers often find themselves overwhelmed by extensive assortments offered by online retailers and show bounded rationality behavior. However, existing literature on dynamic assortment optimization didn't consider consumers' such bounded rationality behavior. This motivates us to employ a simple and effective two-stage consider-then-choose model, namely the Threshold Multinomial Logit (TMNL) model to investigate the online assortment optimization problem. The TMNL model characterizes consumers' endogenous consideration sets formation by the threshold effect. This endogenous dependency can capture more flexible substitution patterns than the classical MNL choice model, but it also creates great difficulties for online learning. In the offline assortment setting, we analyze the properties of optimal assortment and propose an efficient assortment optimization algorithm outperforms the benchmark. In the online setting with unknown customer preferences and consideration set formation, we propose online learning algorithms that achieve nearly optimal regret bounds under both instance-independent and instance-dependent conditions. To the best of our knowledge, we are the first work to consider online assortment problem with consumers' endogenous consider-then-choose behavior. Moreover, our algorithm is extended to the contextual learning setting, effectively mitigating the impact of the number of products on its performance. Extensive numerical experiments validate the efficacy of our proposed algorithms.
Stop Relying on No-Choice and Do not Repeat the Moves: Optimal, Efficient and Practical Algorithms for Assortment Optimization

Abstract:We address the problem of active online assortment optimization problem with preference feedback, which is a framework for modeling user choices and subsetwise utility maximization. The framework is useful in various real-world applications including ad placement, online retail, recommender systems, fine-tuning language models, amongst many. The problem, although has been studied in the past, lacks an intuitive and practical solution approach with simultaneously efficient algorithm and optimal regret guarantee. E.g., popularly used assortment selection algorithms often require the presence of a `strong reference' which is always included in the choice sets, further they are also designed to offer the same assortments repeatedly until the reference item gets selected -- all such requirements are quite unrealistic for practical applications. In this paper, we designed efficient algorithms for the problem of regret minimization in assortment selection with \emph{Plackett Luce} (PL) based user choices. We designed a novel concentration guarantee for estimating the score parameters of the PL model using `\emph{Pairwise Rank-Breaking}', which builds the foundation of our proposed algorithms. Moreover, our methods are practical, provably optimal, and devoid of the aforementioned limitations of the existing methods. Empirical evaluations corroborate our findings and outperform the existing baselines.
