Abstract:Thermo-catalytic conversion of CO2 into more valuable compounds, such as methane, is an attractive strategy for energy storage in chemical bonds and creating a carbon-based circular economy. However, designing heterogeneous catalysts remains a challenging, time- and resource-consuming task. Herein, we present an interpretable, human-in-the-loop active machine learning framework to efficiently plan catalytic experiments, execute them in an automated set-up, and estimate the effect of experimental variables on the catalytic activity. A dataset with 48 catalytic activity tests was compiled from a design space of Ni-Co/Al2O3 catalysts with over 50 million potential combinations in only eight iterations. This small dataset was found sufficient to predict CO2 conversion, methane selectivity, and methane space-time yield with remarkable accuracy (R2 > 0.9) for untested catalysts and reaction conditions. New experiments and catalysts were selected with this methodology, leading to experimental conditions that improved the methane space-time yield by nearly 50% in comparison to the previously obtained maximum in the dataset. Interpretation of the model predictions unveiled the effect of each catalyst descriptor and reaction condition on the outcome. Particularly, the strong predicted inverse trend between the calcination temperature and the catalytic activity was validated experimentally, and characterization implied an underlying structure-performance relationship. Finally, it is demonstrated that the deployed active learning model is excellently suited to predict and fit kinetic trends with a minimal amount of data. This data-driven framework is a first step to faster, model-based, and interpretable design of catalysts and holds promise for broader applications across catalytic processes.

Abstract:1,3‐butadiene is used as raw material in the synthesis of rubber and automobile tires. In this study, machine learning models were utilised to predict the performance of catalysts in the oxidative dehydrogenation of n‐butane to 1,3‐butadiene. The datasets were generated from experiments in fixed‐bed reactor using temperature range of 400‐500oC and O2/C4 feed ratio of 1‐4 mol/mol, with oxides of Nickel (Ni), Iron (Fe), Cobalt (Co), Bismuth (Bi), Molybdenum (Mo), Manganese (Mn) and Tungsten (W) on gamma alumina catalysts. Repeated 10‐fold cross‐validation was used, with 70% of the datasets randomly selected for training and optimising the models, whereas remaining 30% used for testing the models. Support vector machine with radial basis function (SVMR) model had the best coefficient of determination (R2) performance for the n‐butane conversion (training set: 98.3% vs. test set: 88.3%) and 1,3‐butadiene selectivity (training set: 94.0% vs. test set: 88.6%). Additionally, the model had the lowest training and test mean absolute error (MAE) and root mean square error (RMSE). This study highlights the significance of machine learning algorithms in enhancing the prediction of n‐butane oxidative dehydrogenation catalyst performance, thus promoting the development of effective catalysts that exhibit high performance, contributing positively to the field of heterogeneous catalysis.

Abstract:Discovery and optimization of new catalysts can be potentially accelerated by efficient data analysis using machine-learning (ML). In this paper, we record the process of searching for additives in the electrochemical deposition of Cu catalysts for CO2 reduction (CO2RR) using ML, which includes three iterative cycles: "experimental test; ML analysis; prediction and redesign". Cu catalysts are known for CO2RR to obtain a range of products including C1 (CO, HCOOH, CH4, CH3OH) and C2+ (C2H4, C2H6, C2H5OH, C3H7OH). Subtle changes in morphology and surface structure of the catalysts caused by additives in catalyst preparation can lead to dramatic shifts in CO2RR selectivity. After several ML cycles, we obtained catalysts selective for CO, HCOOH, and C2+ products. This catalyst discovery process highlights the potential of ML to accelerate material development by efficiently extracting information from a limited number of experimental data.

Machine-Learning-Driven High-Entropy Alloy Catalyst Discovery to Circumvent the Scaling Relation for CO2 Reduction Reaction

Abstract:To achieve an equitable energy transition toward net-zero 2050 goals, the electrochemical reduction of CO2 (CO2RR) to chemical feedstocks through utilizing both CO2 and renewable energy is particularly attractive. However, the catalytic activity of CO2RR is limited by the scaling relation of the adsorption energies of intermediates. Circumventing the scaling relation is a potential strategy to achieve a breakthrough in catalytic activity. Herein, based on density functional theory (DFT) calculations, we designed a high-entropy alloy (HEA) system of FeCoNiCuMo with high catalytic activity for CO2RR. Machine learning models were developed by considering 1280 adsorption sites to predict the adsorption energies of COOH*, CO*, and CHO*. The scaling relation between the adsorption energies of COOH*, CO*, and CHO* is circumvented by the rotation of COOH* and CHO* on the designed HEA surface, resulting in the outstanding catalytic activity of CO2RR with the limiting potential of 0.29-0.51 V. This work not only accelerates the development of HEA catalysts but also provides an effective strategy to circumvent the scaling relation.
Accelerated prediction of Cu-based single-atom alloy catalysts for CO2 reduction by machine learning

Abstract:Various strategies, including controls of morphology, oxidation state, defect, and doping, have been developed to improve the performance of Cu-based catalysts for CO2 reduction reaction (CO2RR), generating a large amount of data. However, a unified understanding of underlying mechanism for further optimization is still lacking. In this work, combining first-principles calculations and machine learning (ML) techniques, we elucidate critical factors influencing the catalytic properties, taking Cu-based single atom alloys (SAAs) as examples. Our method relies on high-throughput calculations of 2669 CO adsorption configurations on 43 types of Cu-based SAAs with various surfaces. Extensive ML analyses reveal that low generalized coordination numbers and valence electron number are key features to determine catalytic performance. Applying our ML model with cross-group learning scheme, we demonstrate the model generalizes well between Cu-based SAAs with different alloying elements. Further, electronic structure calculations suggest surface negative center could enhance CO adsorption by back donating electrons to antibonding orbitals of CO. Finally, several SAAs, including PCu, AgCu, GaCu, ZnCu, SnCu, GeCu, InCu, and SiCu, are identified as promising CO2RR catalysts. Our work provides a paradigm for the rational design and fast screening of SAAs for various electrocatalytic reactions.

Abstract:This study proposed an auto‐configurable machine learning framework based on the differential evolution algorithm (AutoML‐DE) driven by hybrid data for the screening and discovery of promising CO2 to light olefins (CO2TLO) catalysts candidates. The hybrid dataset comprises 532 experimental data from the literature and 296 simulation data. Results show that the AutoML‐DE model with extreme gradient boosting algorithms demonstrated superior performance for predicting the conversion ratio of CO2 and selectivity of light olefins (average R2 > 0.86). After identifying the input feature with the most significant impact on the output feature, the optimal AutoML‐DE model integrated with the genetic algorithm is applied to multiobjective optimization, sensitivity analysis, and prediction of new CO2TLO catalysts. The optimized Cu‐Zn‐Al/SAPO‐34 catalyst has the highest catalytic performance among the reported CO2TLO catalysts. Moreover, five new CO2TLO catalysts with higher C2=‐C4= yields are successfully predicted. However, the performance of these catalysts should be further verified by experiment.

Abstract:Catalytic conversion of CO2 to carbon neutral fuels can be ecofriendly and allow for economic replacement of fossil fuels. Here, we have investigated high-throughput screening of high entropy alloy (Cu, Co, Ni, Zn, and Sn) based catalysts through machine learning (ML) for CO2 hydrogenation to methanol. Stability and catalytic activity studies of these catalysts have been performed for all possible combinations, where different elemental, compositional, and surface microstructural features were used as input parameters. Adsorption energy values of CO2 reduction intermediates on the CuCoNiZnMg- and CuCoNiZnSn-based catalysts have been used to train the ML models. Successful prediction of adsorption energies of the adsorbates using CuCoNiZnMg-based training data is achieved except for two intermediates. Hence, we show that activity and selectivity of these catalysts can be successfully predicted for CO2 hydrogenation to methanol and have screened a series of high entropy-based catalysts (from 36750 considered catalysts) which could be promising for methanol synthesis.
Discovery of highly efficient dual-atom catalysts for propane dehydrogenation assisted by machine learning

Abstract:Propane dehydrogenation (PDH) is a highly efficient approach for industrial production of propylene, and the dual-atom catalysts (DACs) provide new pathways in advancing atomic catalysis for PDH with dual active sites. In this work, we have developed an efficient strategy to identify promising DACs for PDH reaction by combining high-throughput density functional theory (DFT) calculations and the machine-learning (ML) technique. By choosing the γ-Al2O3(100) surface as the substrate to anchor dual metal atoms, 435 kinds of DACs have been considered to evaluate their PDH catalytic activity. Four ML algorithms are employed to predict the PDH activity and determine the relationship between the intrinsic characteristics of DACs and the catalytic activity. The promising catalysts of CuFe, CuCo and CoZn DACs are finally screened out, which are further validated by the whole kinetic reaction calculations, and the highly efficient performance of DACs is attributed to the synergistic effects and interactions between the paired active sites.

Abstract:Copper-based catalyst is very active for electroreduction of carbon dioxide (CO 2 ) to carbon monoxide (CO). However, the Faraday efficiency of copper-based catalysts for CO production can be affected by many complex factors, such as catalyst elemental composition, morphology, supporting substrate, synthesis method, catalyst size, electrolyte concentration, and test potential with unknown correlations, hindering the efficient exploration of active copper-based CO 2 reduction catalysts with high CO Faraday efficiency. In this study, a machine learning (ML) model is proposed towards rapid screening of copper-based catalysts with high CO selectivity using experimental database. The significance of different catalyst-related features on the CO Faraday efficiency was evaluated using feature importance and Spearman correlation coefficients. The ML model predicted that the dendrite Pd-doped copper oxides catalyst electroless deposited on copper mesh has the highest CO Faraday efficiency (92.8%). This ML study provides a useful guidance for the screening of copper-based catalysts towards the reduction of CO 2 to CO.

Abstract:The literature provides insights for catalyst design and discovery. Effective analysis of reported data using machine learning (ML) methods offers the ability to gain valuable information. However, utilizing the literature in this way has obstacles such as lack of compositional overlaps, bias from prior published data, and low sample counts for many elements. The present study describes an ML approach that considers elemental features as input representations instead of inputting catalyst compositions directly. This ML method has the potential for catalyst discovery, including catalytic reactions with limited catalyst composition overlap in the available data. Oxidative coupling of methane (OCM), water gas shift (WGS), and CO oxidation reactions were chosen to confirm the effectiveness of the proposed method by analysis using several state‐of‐the‐art ML methods. Among the ML methods tested, gradient boosting regression with XGBoost (XGB) provided the best results, and prediction accuracy was improved by the proposed approach for all three reaction types. In addition, a quantitative value of "feature importance score" was calculated to evaluate the most influential input variables on catalyst performance. Finally, catalyst optimization was explored using ML as a "surrogate" model, and the top 20 promising candidate catalysts were identified for the OCM reaction based on the optimization.

Abstract:Indirect CO2 hydrogenation to methanol and ethylene glycol is a green, efficient, and economical technology for converting CO2 into high-value chemicals to address the intractable environmental crisis caused by CO2 emissions. However, traditional methods for screening and optimizing catalysts in this process mainly depend on experience and repeated 'trial-and-error' experiments, which are resource-, time- and cost-consuming tasks. Therefore, this study developed a machine learning framework for predicting the conversion ratio of ethylene carbonate, and the yield of methanol and ethylene glycol of indirect CO2 hydrogenation technology to accelerate its catalyst screening and optimization progress. The initial dataset is visualized by conducting principal component analysis and improved to ensure sufficient information variables for the machine learning model to distinguish catalyst types. After comparing the optimized results of three algorithms, the neural network with two hidden layers is the core of the machine learning model of the indirect CO2 hydrogenation process. It is then further optimized by a feature engineering method coupled with feature importance analysis and Pearson correlation matrix. It indicates that the optimized neural network model has higher performance, especially in predicting ethylene carbonate conversion and product yields. Compared with other input features, the space velocity and hydrogen/ester ratio are the two most important factors affecting the conversion ratio of ethylene carbonate and the yield of methanol and ethylene glycol. According to the results of the feature importance analysis, a multi-objective optimization model with a genetic algorithm is employed to screen the most suitable catalyst. Compared with other catalysts, more efforts should be paid to the optimized xMoOx-Cu/SiO2 catalyst for the industrialization of CO2 indirect hydrogenation technology after experimental verification.

Abstract:The electrochemical carbon dioxide reduction reaction (CO 2 RR) is an attractive approach for mitigating CO 2 emissions and generating value-added products. Consequently, discovery of promising CO 2 RR catalysts has become a crucial task, and machine learning (ML) has been utilized to accelerate catalyst discovery. However, current ML approaches are limited to exploring narrow chemical spaces and provide only fragmentary catalytic activity, even though CO 2 RR produces various chemicals. Here, by merging pre-developed ML model and a CO 2 RR selectivity map, we establish high-throughput virtual screening strategy to suggest active and selective catalysts for CO 2 RR without being limited to a database. Further, this strategy can provide guidance on stoichiometry and morphology of the catalyst to researchers. We predict the activity and selectivity of 465 metallic catalysts toward four expected reaction products. During this process, we discover previously unreported and promising behavior of Cu-Ga and Cu-Pd alloys. These findings are then validated through experimental methods.
Machine-Learning-Augmented Chemisorption Model for CO2 Electroreduction Catalyst Screening.

Abstract:We present a machine-learning-augmented chemisorption model that enables fast and accurate prediction of the surface reactivity of metal alloys within a broad chemical space. Specifically, we show that artificial neural networks, a family of biologically inspired learning algorithms, trained with a set of ab initio adsorption energies and electronic fingerprints of idealized bimetallic surfaces, can capture complex, nonlinear interactions of adsorbates (e.g., *CO) on multimetallics with ∼0.1 eV error, outperforming the two-level interaction model in prediction. By leveraging scaling relations between adsorption energies of similar adsorbates, we illustrate that this integrated approach greatly facilitates high-throughput catalyst screening and, as a specific case, suggests promising {100}-terminated multimetallic alloys with improved efficiency and selectivity for CO2 electrochemical reduction to C2 species. Statistical analysis of the network response to perturbations of input features underpins our fundamental understanding of chemical bonding on metal surfaces.

Abstract:The design of selective and stable catalysts is a major challenge in heterogeneous catalysis, also true for propane dehydrogenation (PDH), an on-purpose route to produce propylene. Identifying nonprecious catalysts to replace Pt used today is another formidable task. Herein, we combine kinetic simulations, high-throughput computations, machine-learning concepts, and experiments to illustrate the key parameters controlling the performance of metallic catalysts in PDH. Our decision map successfully identifies NiMo as a very promising nonprecious metal catalyst, which is experimentally proven to outperform Pt in PDH. Our framework not only validates experimentally known catalysts but also provides ways for PDH catalyst engineering from theoretical high-throughput screening. Abstract:Ammonia, a cost-effective hydrogen carrier, holds the potential for hydrogen production through decomposition, where catalysts play a pivotal role in lowering the decomposition temperature. However, identifying suitable catalysts involves expensive and time-consuming experiments. Machine learning (ML) emerges as a powerful solution to address challenges in catalytic ammonia decomposition. This study focuses on creating an ML model to predict ammonia decomposition. A comprehensive database is compiled and statistically analyzed to discern correlations between descriptors and responses. Employing random forest regression, support vector machine, and gradient boost regression models, the study models the ammonia decomposition process as a function of catalyst properties and reaction conditions. Feature importance analysis evaluates the influence of descriptors on responses. The results unveil a robust positive correlation between ammonia decomposition and reaction temperature. Improved ammonia decomposition and hydrogen formation rates are achievable with a total metal loading below 20 %. The gradient boost regression tree model exhibits satisfactory performance during testing (R2 > 0.85, RMSE <13.24, and MAE < 10.31). Notably, reaction temperature and gas hourly space velocity emerge as the two most influential descriptors impacting ammonia conversion and hydrogen formation rate. This research underscores the efficacy of ML in addressing challenges in catalytic ammonia decomposition, providing valuable insights for the advancement of hydrogen production.
Explainable Data-driven Modeling of Adsorption Energy in Heterogeneous Catalysis

Abstract:The increasing popularity of machine learning (ML) in catalysis has spurred interest in leveraging these techniques to enhance catalyst design. Our study aims to bridge the gap between physics-based studies and data-driven methodologies by integrating ML techniques with eXplainable AI (XAI). Specifically, we employ two XAI techniques: Post-hoc XAI analysis and Symbolic Regression. These techniques help us unravel the correlation between adsorption energy and the properties of the adsorbate-catalyst system. Leveraging a large dataset such as the Open Catalyst Dataset (OC20), we employ a combination of shallow ML techniques and XAI methodologies. Our investigation involves utilizing multiple shallow machine learning techniques to predict adsorption energy, followed by post-hoc analysis for feature importance, inter-feature correlations, and the influence of various feature values on the prediction of adsorption energy. The post-hoc analysis reveals that adsorbate properties exert a greater influence than catalyst properties in our dataset. The top five features based on higher Shapley values are adsorbate electronegativity, the number of adsorbate atoms, catalyst electronegativity, effective coordination number, and the sum of atomic numbers of the adsorbate molecule. There is a positive correlation between catalyst and adsorbate electronegativity with the prediction of adsorption energy. Additionally, symbolic regression yields results consistent with SHAP analysis. It deduces a mathematical relationship indicating that the square of the catalyst electronegativity is directly proportional to the adsorption energy. These consistent correlations resemble those derived from physics-based equations in previous research. Our work establishes a robust framework that integrates ML techniques with XAI, leveraging large datasets like OC20 to enhance catalyst design through model explainability.

Abstract:The highly selective conversion of carbon dioxide into value-added products is extremely valuable. However, even with the aid of in situ characterization techniques, it remains challenging to directly correlate extensive spectral data carrying microscopic information with macroscopic performance. Herein, we adopted advanced machine learning (ML) approaches to establish an accurate and interpretable relationship between vibrational spectral signals and catalytic performances to uncover hidden physical insights. Focusing on photocatalytic CO2 reduction, our model is shown to effectively and accurately predict the CO production activity and selectivity based solely on the infrared (IR) spectral signals, the generalizability of which is additionally demonstrated with a new Bi5O7I photocatalytic system. More importantly, further model analysis has revealed a novel strategy to steer CO selectivity, the physical sanity of which is verified by a detailed reaction mechanism analysis. This work demonstrates the tremendous potential of machine-learned spectroscopy to efficiently identify reaction control factors, which can further lay the foundation for targeted optimization and reverse design.
Machine Learning Across Metal and Carbon Support for the Screening of Efficient Atomic Catalysts Toward CO2 Reduction

Abstract:The rational design of novel atomic catalysts (ACs) for CO2 reduction reactions is often hindered by massive possibilities, which require intensive costs for experiments and theoretical calculations. This work applies a machine learning technique with theoretical calculations to reveal the C1 and C2 pathways, which further promotes the predictions of C3 intermediates of CO2 reduction reactions. Developing efficient atomic catalysts (ACs) for the CO2 reduction reaction (CO2RR) still requires ultrahigh experimental resources and a long research period due to the complicated reaction mechanisms and abundant active sites. Herein, this work presents the energy‐based first principles machine learning (FPML) method for the first time based on over 15 000 datasets to directly predict the reaction trends of the CO2RR. The unique scaling relationship of the hydrogenation steps is revealed in ACs for the CO2RR, which is correlated with the active sites instead ofelectron transfer numbers. Based on machine learning (ML) predictions, this work reports that the standard electrode potential is affected by the pH values, and proposes a zero‐point calibration strategy to realize more accurate predictions of electrocatalysis reactions to supply meaningful references to experiments. The formation of electroactive regions constructed by mixing active sites is revealed, which confirms the neighboring effects for the activation of active sites. In addition, the prediction of C3 intermediates indicates the potential of multicarbon coupling processes on the carbon active sites of graphdiyne. This work supplies an effective method to predict chemical reaction trends of different ACs in the CO2RR by ML, which is expected to accelerate the rational design of novel ACs for broad electrocatalysis.

Abstract:Artificial neural network (ANN) is developed from an extensively collected database for accurate predictions of CO2 conversion and methanol selectivity after screening nine machine learning (ML) models. Relative importance of process factors is revealed by feature engineering. ML findings for synthesized catalysts unveiled by Cu‐ZnO synergy, thus experimentally validated model efficacy. The strategy provides dynamic solution to uncertainties in catalysis field. The hydrogenation of CO2 to methanol has been studied by several researchers owing to its two significant merits, namely, mitigation of CO2 emissions and production of renewable fuel. Consequently, numerous experiments have been reported for carbon‐neutral methanol synthesis over copper‐based catalysts over the past few years. However, it is very expensive and time‐consuming to always observe reaction changes with respect to input parameters (operating conditions and catalytic properties) experimentally. Herein, this study develops an ultrafast machine learning (ML) based framework to predict CO2 conversion and methanol selectivity by comprehensive knowledge extraction (extensive database construction) from existing published literature. Among various ML algorithms, artificial neural networks (ANNs) exhibit best accuracy with R2test values of 0.885 and 0.861 for CO2 conversion and methanol selectivity, respectively. Subsequently, the efficacy and fidelity of developed neural networks are depicted by satisfactory performance (R2 ≥ 0.80) for majority of unseen test datasets (literature‐based as well as the experimental dataset for Cu/ZnO/Al2O3 catalyst). Finally, this work concludes that this ML‐based concept allows to uncover catalytic property–performance correlations hidden in large body of existing experimental research. This offers an open and generic platform for a major breakthrough of ML in heterogeneous catalysis which can help in planning future experiments.

Abstract:The electrochemical carbon dioxide reduction reaction (CO2RR) is an attractive approach for mitigating CO2 emissions and generating value-added products. Consequently, discovery of promising CO2RR catalysts has become a crucial task, and machine learning (ML) has been utilized to accelerate catalyst discovery. However, current ML approaches are limited to exploring narrow chemical spaces and provide only fragmentary catalytic activity, even though CO2RR produces various chemicals. Here, by merging pre-developed ML model and a CO2RR selectivity map, we establish high-throughput virtual screening strategy to suggest active and selective catalysts for CO2RR without being limited to a database. Further, this strategy can provide guidance on stoichiometry and morphology of the catalyst to researchers. We predict the activity and selectivity of 465 metallic catalysts toward four expected reaction products. During this process, we discover previously unreported and promising behavior of Cu-Ga and Cu-Pd alloys. These findings are then validated through experimental methods.
