Intelligent fault diagnosis of rolling bearing based on an active federated local subdomain adaptation method

Abstract:With the significant advancement of intelligent fault diagnosis (FD) technology in recent years, federated learning methodologies, which employ data from multiple devices for training and optimizing the global diagnosis model by independent local models, have attracted much attention from researchers. However, the quality of training data is often low when the mechanical equipment is operating in unstable conditions, and the collected data is not labeled or incorrectly labeled. Consequently, data scarcity, poor quality, and distribution differences will lead to poor test accuracy for federated learning diagnostic models. To solve these problems, we proposed an intelligent FD of rolling bearing based on an active federated local subdomain adaptation method (AFL-SA). Initially, the transformer learning model is improved to enhance the diagnostic capabilities of the FedAvg method. Subsequently, by employing the principle of active learning, we introduce a clustering local model query mechanism (LQ) based on the active learning principle. Clients can identify and select high-quality data for labeling to enrich the training data set. Every client incorporates a subdomain adaptation (SA) approach to transfer learning, which introduces a standardized local maximum mean difference (LMMD) distance measure to mitigate differences in data distribution between target and source clients. Lastly, each client update model and weight value are uploaded to the central server to update the global model. Our proposed AFL-SA method effectively mitigates the impact of low-quality datasets on training outcomes, enhancing diagnostic accuracy while preserving data privacy. Empirical validation through comparative analysis of two bearing datasets and ablation experiments demonstrates the efficacy of our approach.
