Abstract:The application of artificial intelligence (AI) in the field of welding is an increasingly important area of research and a large number of journal publications on the topic have been published. A keyword search for AI in welding in the leading scientific journal databases Elsevier and Springer reveals more than 3,000 related articles. The large publication volume shows the importance being attributed to AI in welding and the breadth of the contributions of researchers utilizing AI approaches to tackle challenges and problems in welding. Such challenges include poorly controlled welding parameters and weld geometry, which lead to weld quality problems. This paper reviews previous studies on AI systems utilized in welding process control and welding robot control. Case studies on the utilization and development of AI systems in the Finnish welding industry are also presented. Analyses of the findings provide the means to predict future scenarios for a 5–10 year time frame on the impact of AI in the welding industry in the era of Industry 4.0. The changes that AI bring will drive a need for new technological, economic and social policies as well as reform of educational curricula and skills training in the sphere of sustainability and quality of life. Consideration of trends and scenarios is important for both academia and industry, where new research ideas and developmental trends on AI systems will emerge for practical implementation.

Abstract:Welding systems are being transformed by the advent of modern information technologies such as the internet of things, big data, artificial intelligence, cloud computing, and intelligent manufacturing. Intelligent welding systems (IWS), making use of these technologies, are drawing attention from academic and industrial communities. Intelligent welding is the use of computers to mimic, strengthen, and/or replace human operators in sensing, learning, decision-making, monitoring and control, etc. This is accomplished by integrating the advantages of humans and physical systems into intelligent cyber systems. While intelligent welding has found pilot applications in industry, a systematic analysis of its components, applications, and future directions will help provide a unified definition of intelligent welding systems. This paper examines fundamental components and techniques necessary to make welding systems intelligent, including sensing and signal processing, feature extraction and selection, modeling, decision-making, and learning. Emerging technologies and their application potential to IWS will also be surveyed, including Industry 4.0, cyber-physical system (CPS), digital twins, etc. Typical applications in IWS will be surveyed, including weld design, task sequencing, robot path planning, robot programming, process monitoring and diagnosis, prediction, process control, quality inspection and assessment, human-robot collaboration, and virtual welding. Finally, conclusions and suggestions for future development will be proposed. This review is intended to provide a reference of the state-of-the-art for those seeking to introduce intelligent welding capabilities as they modernize their traditional welding stations, systems, and factories.
A technical perspective on integrating artificial intelligence to solid-state welding

Abstract:Abstract The implementation of artificial intelligence (AI) techniques in industrial applications, especially solid-state welding (SSW), has transformed modeling, optimization, forecasting, and controlling sophisticated systems. SSW is a better method for joining due to the least melting of material thus maintaining Nugget region integrity. This study investigates thoroughly how AI-based predictions have impacted SSW by looking at methods like Artificial Neural Networks (ANN), Fuzzy Logic (FL), Machine Learning (ML), Meta-Heuristic Algorithms, and Hybrid Methods (HM) as applied to Friction Stir Welding (FSW), Ultrasonic Welding (UW), and Diffusion Bonding (DB). Studies on Diffusion Bonding reveal that ANN and Generic Algorithms can predict outcomes with an accuracy range of 85 – 99%, while Response Surface Methodology such as Optimization Strategy can achieve up to 95 percent confidence levels in improving bonding strength and optimizing process parameters. Using ANNs for FSW gives an average percentage error of about 95%, but using metaheuristics refined it at an incrementally improved accuracy rate of about 2%. In UW, ANN, Hybrid ANN, and ML models predict output parameters with accuracy levels ranging from 85 to 96%. Integrating AI techniques with optimization algorithms, for instance, GA and Particle Swarm Optimization (PSO) significantly improves accuracy, enhancing parameter prediction and optimizing UW processes. ANN’s high accuracy of nearly 95% compared to other techniques like FL and ML in predicting welding parameters. HM exhibits superior precision, showcasing their potential to enhance weld quality, minimize trial welds, and reduce costs and time. Various emerging hybrid methods offer better prediction accuracy.

Abstract:Welding is a complex process that plays a critical role in various industries, including manufacturing, construction, and automotive. Achieving optimal welding process parameters is essential to ensure high-quality welds with minimal defects. However, determining the optimal parameters requires extensive experimentation and expertise, which can be time-consuming and costly. In artificial intelligence (AI) algorithms have shown great potential in optimizing welding process parameters. This study focuses on the application of AI algorithms for optimizing welding process parameters. The objective is to develop a machine learning model that can accurately predict the optimal welding parameters based on various input factors such as material type, joint configuration, and desired weld quality. The model utilizes a dataset of past welding experiments, where the parameters and corresponding weld quality were recorded. The significance of this research lies in its potential to revolutionize the welding industry by improving the efficiency and effectiveness of the welding process. By leveraging AI algorithms, the model can quickly analyze and identify the relationships between input factors and welding parameters, leading to optimal parameter recommendations. This can result in reduced welding defects, improved weld quality, and increased productivity. To achieve the research objectives, a comprehensive literature review is conducted to understand the current state of AI algorithms applied to welding process optimization. Various AI techniques such as neural networks, genetic algorithms, and support vector machines are explored for their suitability in this context. The literature review also covers previous studies and their findings on the application of AI algorithms in welding parameter optimization. The methodology of this research involves the collection of welding process data from different welding experiments. This dataset is then pre- processed to handle missing values, outliers, and normalize the data. Feature engineering techniques are applied to select the most relevant input factors. Several AI algorithms are implemented and trained using the dataset, and their performance is evaluated using appropriate metrics such as accuracy and mean squared error. The accuracy of parameter predictions and the effectiveness of the optimized welding process parameters are evaluated. Furthermore, the implications of using AI algorithms for welding parameter optimization are discussed, highlighting the potential benefits and limitations of this approach. This research demonstrates the applicability and effectiveness of AI algorithms in optimizing welding process parameters. The developed machine learning model offers a promising solution to expedite the parameter optimization process, leading to improved weld quality and reduced costs. The practical implications of this study include increased productivity, enhanced weld quality control, and improved overall efficiency in the welding industry. The findings of this research contribute to the growing field of AI-assisted welding process optimization and pave the way for further advancements in this area.

Abstract:In recent years, welding feedback control systems and weld quality estimation systems have been developed with the use of artificial intelligence to increase the quality consistency of robotic welding solutions. This paper introduces the utilization of an intelligent welding system (IWS) for feedback controlling the welding process. In this study, the GMAW process is controlled by a backpropagation neural network (NN). The feedback control of the welding process is controlled by the input parameters; root face and root gap, measured by a laser triangulation sensor. The NN is trained to adapt NN output parameters; wire feed and arc voltage override of the weld power source, in order to achieve consistent weld quality. The NN is trained offline with the specific parameter window in varying weld conditions, and the testing of the system is performed on separate specimens to evaluate the performance of the system. The butt-weld case is explained starting from the experimental setup to the training process of the IWS, optimization and operating principle. Furthermore, the method to create IWS for the welding process is explained. The results show that the developed IWS can adapt to the welding conditions of the seam and feedback control the welding process to achieve consistent weld quality outcomes. The method of using NN as a welding process parameter optimization tool was successful. The results of this paper indicate that an increased number of sensors could be applied to measure and control the welding process with the developed IWS.
Online Quality Inspection of Ultrasonic Composite Welding by Combining Artificial Intelligence Technologies with Welding Process Signatures

Abstract:Ultrasonic welding is a joining technology suitable for carbon-fiber-reinforced thermoplastic (CFRTP) components because of its high throughput, and ease of automation. An effective online weld-quality inspection technology can promote the industrial application of ultrasonic composite welding. Literature focused on the quality inspection of ultrasonic composite welding is scarce. To address this, the present study proposes an online weld-quality inspection method for ultrasonic composite welding by combining artificial intelligence (AI) technologies with welding process signatures. The failure load in a tensile-shear test and the weld quality level (i.e., under weld, normal weld, and over weld) are predicted simultaneously using artificial neural network (ANN) and random forest (RF) models. Eight features consisting of the duration and energy at each welding stage are extracted from the process signatures as independent variables. The results indicate that both the ANN and RF models exhibit high prediction accuracies. The weld quality can be assessed comprehensively and reasonably by considering both the failure load and weld quality level. The findings of this study demonstrate the feasibility of online weld-quality inspection for ultrasonic composite welding.

Abstract:This study addresses the gap between laboratory-focused welding process parameter identification and their practical application in the industry. Unlike traditional input–output mapping reported in the literature, determining acceptable input process parameters in industry hinges on the acceptable threshold for imperfections. The research aims to devise an artificial intelligence system capable of forecasting acceptable parameters for robotic gas metal arc welding, aligning with the quality standards outlined in AWS B4.0:2016 and BS EN ISO 5817:2014. Parameters, including wire feed rate, travel speed, contact tip to work distance, and electrode work angle, are considered in the prediction model. Throat thickness and joint penetration are critical responses for weldments involving 2-mm-, 4-mm-, and 6-mm-thick 4130 steel plates. The fuzzy model achieves effective defuzzification by employing fuzzy expert rules, triangular membership functions, and the centroid area method via the MATLAB fuzzy logic toolbox. The models are rigorously validated through experimental work. The study culminates in the acquisition of accurately predicted and experimentally acceptable input process parameters across varying quality levels (B, C, and D).

Abstract:A framework and implementation roadmap for an intelligent welding system (IWS) is proposed from the human-cyber-physical systems (HCPS) perspective of integrating cyber systems with humans and physical systems. Key technologies and system requirements for the framework are comprehensively analyzed. A technology network is proposed to explore the link between complex IWS technologies and application domain requirements. To investigate the practical extent of the state-of-the-art, an example enterprise illustrates the technologies necessary to implement an IWS and the representative technological gaps. Technologies required for IWS were evaluated for their maturity, benefit, and market availability using the Gartner hype-cycle and priority matrix methodology. Finally, an implementation roadmap with research suggestions towards IWS is recommended. This work can support enterprises or factories that want to implement intelligent welding into their operations by clarifying the development state of intelligent technologies and the priority by which further development should be pursued.

Abstract:A master welder uses his sensory perceptions to evaluate the process and connect them with his/her knowledge base to take the necessary corrective measures with his/her acquired skills to make a good weld. All these actions must take place in real time. Success depends on intuition and skills, and the procedure is labor-intensive and frequently unreliable. The solution is intelligent weld manufacturing. The ultimate goal of intelligent weld manufacturing would involve sensing and control of heat source position, weld temperature, weld penetration, defect formation and ultimately control of microstructure and properties. This involves a solution to a problem (welding) with many highly coupled and nonlinear variables. The trend is to use an emerging tool known as intelligent control. This approach enables the user to choose a desirable end factor such as properties, defect control, or productivity to derive the selection of process parameters such as current, voltage, or speed to provide for appropriate control of the process. Important elements of intelligent manufacturing are sensing and control theory and design, process modeling, and artificial intelligence. Significant progress has been made in all these areas. Integrated computational welding engineering (ICWE) is an emerging field that will aid in the realization of intelligent weld manufacturing. The paper will discuss the progress in process modeling, microstructure, properties, and process control and automation and the importance of ICWE. Also, control and automation strategies for friction stir welding will be discussed.

Abstract:The welding process, which is an indispensable part of the manufacturing industry, has been in demand for years and continues to attract the attention of researchers. With the transition to Industry 4.0, the welding process got out of the control of the operators and became automated with sensors and artificial intelligence methods, and as a result, it became inevitable for industrial manipulators or robots to enter the production sector. One of the most important details in making the welding process autonomous in manufacturing is the sensors, and among the sensors are the vision sensors. In recent years, it is seen that robotic welding applications are applied very sensitively and successfully when visual sense and artificial intelligence are used together. This study comprehensively reviewed research and development for cutting-edge applications using visual sensors and artificial intelligence for robotic welding applications. The processes that are the subject of intelligent robotic welding applications such as calibration, determination of welding starting point, seam tracking, and welding quality are determined and discussed based on current studies and critical analyzes. The detection, tracking, diagnosis, classification, and prediction performances of various methods of machine learning (ML), which is one of the most used areas in artificial intelligence-based applications, in welding applications are examined comparatively. This review article will help researchers about what should be considered in vision sensor aided robotic welding applications and how to contribute more to studies with artificial intelligence support.

Abstract:<span class="a-plus-plus abstract-section id-a-sec1"><p class="a-plus-plus">Advances in artificial intelligence (AI) techniques that can be used for different purposes have enabled it to be used in many different industrial applications. These are mainly used for modeling, identification, optimization, prediction and control of complex systems under the influence of more than one parameter in industrial applications. With the increasing accuracy of AI techniques, it has also obtained a wide application area on friction stir welding (FSW), one of the production methods developed in recent years. In this study, commonly used AI techniques for FSW, results, accuracy and superiority of AI techniques are reviewed and evaluated. In addition, an overview of AI techniques for FSW in different material combinations is provided. Considering the articles examined; It is seen that welding speed, rotational speed, the plunge depth, spindle torque, shoulder design, base material, pin design/profile, tool type are used as input parameters and tensile strength, yield strength, elongation, hardness, wear rate, welding quality, residual stress, fatigue strength are used as output parameters. As can be seen from the studies, it made important contributions in deciding what input parameters should be in order to have the output parameter at the desired value. The most common used materials for FSW are Al, Ti, Mg, Brass, Cu and so on. When FSW studies using artificial intelligence techniques were examined, it was seen that 81% of the most used materials were AL alloys and 23% of them were made with dissimilar materials. The most commonly utilized AI techniques were said to be artificial neural networks (ANN), fuzzy logic, machine learning, meta-heuristic methods and hybrid systems. As a result of the examination, ANN was the most widely used method among these methods. Abstract:Optimal design of the welding procedure gives the desired welding results under nominal welding conditions. During manufacturing, where the actual welding manufacturing conditions often deviate from the nominal ones used in the design, applying the designed procedure will produce welding results that are different from the desired ones. Adaption is needed to make corrections and adjust some of the welding parameters from those specified in the design. This is adaptive welding. While human welders can be adaptive to make corrections and adjustments, their performance is limited by their physical constraints and skill level. To be adaptive, automated and robotic welding systems require abilities in sensing the welding process, extracting the needed information from signals from the sensors, predicting the responses of the welding process to the adjustments on welding parameters, and optimizing the adjustments. This results in the application of classical sensing, modeling of process dynamics, and control system design. In many cases, the needed information for the weld quality and process variables of our concern is not easy to extract from the sensor’s data. Studies are needed to propose the phenomena to sense and establish the scientific foundation to correlate them to the weld quality or process variables of our concern. Such studies can be labor intensive, and a more automated approach is needed. Analysis suggests that artificial intelligence and machine learning, especially deep learning, can help automate the learning such that the needed intelligence for robotic welding adaptation can be directly and automatically learned from experimental data after the physical phenomena being represented by the experimental data has been appropriately selected to make sure they are fundamentally correlated to that with which we are concerned. Some adaptation abilities may also be learned from skilled human welders. In addition, human-robot collaborative welding may incorporate adaptations from humans with the welding robots. This paper analyzes and identifies the challenges in adaptive robotic welding, reviews efforts devoted to solve these challenges, analyzes the principles and nature of the methods behind these efforts, and introduces modern approaches, including machine learning/deep learning, learning from humans, and human-robot collaboration, to solve these challenges.

Development of in-process welding torch position control system using AI technology

Abstract:The authors have developed a torch position control system for narrow groove automatic TIG welding. This system can detect the feature point (electrode, wire, groove wall, and weld pool) positions in a weld pool image, calculate the relative positions, and move the electrode and wire to the correct positions. In order to identify the wavelength range that is less susceptible to arc light when capturing weld pool images, spectroscopic analysis was performed and a 1000-nm bandpass filter was selected. Since the brightness distribution suitable for detection differs for each feature point, weld pool images were captured with multiple exposure times. In order to accurately detect the feature points of various weld pool images, AI technology (the pose estimation model DarkPose) that can improve detection accuracy by adding training data was used. When the detection models were evaluated, it was found that the electrode, wire, and groove wall were detected with high accuracy. The torch position control system using the developed feature point detection technology was implemented. The system accurately detected the feature point positions and moved the electrode and wire to the correct position when the feature point position was misaligned. Also, the processing speed of the system was sufficient for torch position control of actual automatic TIG welding.

Abstract:Underwater welding robots play a crucial role in addressing challenges such as low efficiency, suboptimal performance, and high risks associated with underwater welding operations. These robots face a dual challenge encompassing both hardware deployment and software algorithms. Recent years have seen significant interest in humanoid robots and artificial intelligence (AI) technologies, which hold promise as breakthrough solutions for advancing underwater welding capabilities. Firstly, this review delves into the hardware platforms envisioned for future underwater humanoid welding robots (UHWR), encompassing both underwater apparatus and terrestrial support equipment. Secondly, it provides an extensive overview of AI applications in underwater welding scenarios, particularly focusing on their implementation in UHWR. This includes detailed discussions on multi-sensor calibration, vision-based three-dimensional (3D) reconstruction, extraction of weld features, decision-making for weld repairs, robot trajectory planning, and motion planning for dual-arm robots. Through comparative analysis within the text, it becomes evident that AI significantly enhances capabilities such as underwater multi-sensor calibration, vision-based 3D reconstruction, and weld feature extraction. Moreover, AI shows substantial potential in tasks like underwater image enhancement, decision-making processes, robot trajectory planning, and dual-arm robot motion planning. Looking ahead, the development trajectory for AI in UHWR emphasizes multifunctional models, edge computing in compact models, and advanced decision-making technologies in expansive models.

Abstract:The welding workforce is facing a deficit of skilled welders, highlighting the need to develop more efficient and effective welding training methods. Virtual reality (VR) technologies have been adopted to create VR welding simulations for educational and training purposes. The purpose of this literature review was to collect and analyze peer-reviewed research, published between 2012-2022, regarding VR technology applications in welding training. The concept of Engagement in Blended Learning Environments served as our research framework. In the context of welding, VR welding training is a relatively new approach that functions as a blended learning environment. During data collection, we identified 31 articles; however, following analysis and coding, 13 were excluded, for a final N=18. Through a process of triangulation, we identified themes across existing research to highlight trends, recommendations for real-world welding practice, and recommendations for future research. Four main research themes emerged from the literature: 1. Comparison of Approaches, 2. VR as a Teaching Tool, 3. System Development, and 4. System Testing. Six future research recommendations were identified and grouped, including the recommendation to compare virtual weld performances to live weld performances. Four practitioner-based recommendation themes were identified, including the recommendation for instructors to develop their own knowledge and skills related to VR welding technology. From this review, we identified gaps in the existing literature and made recommendations for future research on VR welding training.

Abstract:In this work we explore the application of AI to robotic welding. Robotic welding is a widely used technology in many industries, but robots currently do not have the capability to detect welding defects which get introduced due to various reasons in the welding process. We describe how deep-learning methods can be applied to detect weld defects in real-time by recording the welding process with microphones and a camera. Our findings are based on a large database with more than 4000 welding samples we collected which covers different weld types, materials and various defect categories. All deep learning models are trained in an unsupervised fashion because the space of possible defects is large and the defects in our data may contain biases. We demonstrate that a reliable real-time detection of most categories of weld defects is feasible both from audio and video, with improvements achieved by combining both modalities. Specifically, the multi-modal approach achieves an average Area-under-ROC-Curve (AUC) of 0.92 over all eleven defect types in our data. We conclude the paper with an analysis of the results by defect type and a discussion of future work.

Abstract:Business and Professional Communication Quarterly, Ahead of Print. Generative AI may significantly disrupt the teaching and practice of business communication. This study of 343 communication instructors revealed a collective view that AI-assisted writing will be widely adopted in the workplace and will require significant changes to instruction. Key perceived challenges include less critical thinking and authenticity in writing. Key perceived benefits include more efficiency and better idea generation in writing. Students will need to develop AI literacy—composed of application, authenticity, accountability, and agency—to succeed in the workplace. Recommendations are provided for instructors and administrators to ensure the benefits of AI-assisted writing can outweigh the challenges.
