Abstract:Influenced by the great success of deep learning in computer vision and language understanding, research in recommendation has shifted to inventing new recommender models based on neural networks. In recent years, we have witnessed significant progress in developing neural recommender models, which generalize and surpass traditional recommender models owing to the strong representation power of neural networks. In this survey paper, we conduct a systematic review on neural recommender models from the perspective of recommendation modeling with the accuracy goal, aiming to summarize this field to facilitate researchers and practitioners working on recommender systems. Specifically, based on the data usage during recommendation modeling we divide the work into collaborative filtering and information-rich recommendation: 1) collaborative filtering, which leverages the key source of user-item interaction data; 2) content enriched recommendation, which additionally utilizes the side information associated with users and items, like user profile and item knowledge graph; and 3) temporal/sequential recommendation, which accounts for the contextual information associated with an interaction, such as time, location, and the past interactions. After reviewing representative work for each type, we finally discuss some promising directions in this field. Abstract:Collaborative filtering (CF) is one of the most popular techniques for building recommender systems. To overcome the data sparsity in CF, social recommender systems have emerged to boost recommendation performance by utilizing social correlation among users' interests. Recently, inspired by the immense success of deep learning for embedding learning, neural network-based recommender systems have shown promising recommendation performance. Nevertheless, few researchers have attempted to tackle the social recommendation problem with neural models. To this end, in this paper, we design a neural architecture that organically combines the intrinsic relationship between social network structure and user-item interaction behavior for social recommendation. Two key challenges arise in this process: first, how to incorporate the social correlation of users' interests in this neural model, and second, how to design a neural architecture to capture the unique characteristics of user-item interaction behavior for recommendation. To tackle these two challenges, we develop a model named collaborative neural social recommendation (CNSR) with two parts: 1) a social embedding part and 2) a collaborative neural recommendation (CNR) part. In CNSR, the user embedding leverages each user's social embedding learned from an unsupervised deep learning technique with social correlation regularization. The user and item embeddings are then fed into a unique neural network with a newly designed collaboration layer to model both the shallow collaborative and deep complex interaction relationships between users and items. We further propose a joint learning framework to allow the social embedding part and the CNR part to mutually enhance each other. Finally, extensive experimental results on two real-world datasets clearly demonstrate the effectiveness of our proposed model.

Abstract:This survey provides an examination of the use of Deep Neural Networks (DNN) in Collaborative Filtering (CF) recommendation systems. As the digital world increasingly relies on data-driven approaches, traditional CF techniques face limitations in scalability and flexibility. DNNs can address these challenges by effectively modeling complex, non-linear relationships within the data. We begin by exploring the fundamental principles of both collaborative filtering and deep neural networks, laying the groundwork for understanding their integration. Subsequently, we review key advancements in the field, categorizing various deep learning models that enhance CF systems, including Multilayer Perceptrons (MLP), Convolutional Neural Networks (CNN), Recurrent Neural Networks (RNN), Graph Neural Networks (GNN), autoencoders, Generative Adversarial Networks (GAN), and Restricted Boltzmann Machines (RBM). The paper also discusses evaluation protocols, various publicly available auxiliary information, and data features. Furthermore, the survey concludes with a discussion of the challenges and future research opportunities in enhancing collaborative filtering systems with deep learning.

Abstract:In this paper, we study collaborative filtering in an interactive setting, in which the recommender agents iterate between making recommendations and updating the user profile based on the interactive feedback. The most challenging problem in this scenario is how to suggest items when the user profile has not been well established, i.e., recommend for cold-start users or warm-start users with taste drifting. Existing approaches either rely on overly pessimistic linear exploration strategy or adopt meta-learning based algorithms in a full exploitation way. In this work, to quickly catch up with the user's interests, we propose to represent the exploration policy with a neural network and directly learn it from the feedback data. Specifically, the exploration policy is encoded in the weights of multi-channel stacked self-attention neural networks and trained with efficient Q-learning by maximizing users' overall satisfaction in the recommender systems. The key insight is that the satisfied recommendations triggered by the exploration recommendation can be viewed as the exploration bonus (delayed reward) for its contribution on improving the quality of the user profile. Therefore, the proposed exploration policy, to balance between learning the user profile and making accurate recommendations, can be directly optimized by maximizing users' long-term satisfaction with reinforcement learning. Extensive experiments and analysis conducted on three benchmark collaborative filtering datasets have demonstrated the advantage of our method over state-of-the-art methods.

Abstract:Recent years have witnessed the rapid development of online social platforms,which effectively support the business intelligence and provide services for massive users.Along this line,large efforts have been made on the socialaware recommendation task,i.e.,leveraging social contextual information to improve recommendation performance.Most existing methods have treated social relations in a static way,but the dynamic influence of social contextual information on users' consumption choices has been largely unexploited.To that end,in this paper,we conduct a comprehensive study to reveal the dynamic social influence on users' preferences,and then we propose a deep model called Dynamic Social-Aware Recommender System (DSRS) to integrate the users' structural and temporal social contexts to address the dynamic socialaware recommendation task.DSRS consists of two main components,i.e.,the social influence learning (SIL) and dynamic preference learning (DPL).Specifically,in the SIL module,we arrange social graphs in a sequential order and borrow the power of graph convolution networks (GCNs) to learn social context.Moreover,we design a structural-temporal attention mechanism to discriminatively model the structural social influence and the temporal social influence.Then,in the DPL part,users' individual preferences are learned dynamically by recurrent neural networks (RNNs).Finally,with a prediction layer,we combine the users' social context and dynamic preferences to generate recommendations.We conduct extensive experiments on two real-world datasets,and the experimental results demonstrate the superiority and effectiveness of our proposed model compared with the state-of-the-art methods.

Abstract:Online social networking sites have become popular platforms on which users can link with each other and share information, not only basic rating information but also information such as contexts, social relationships, and item contents. However, as far as we know, no existing works systematically combine diverse types of information to build more accurate recommender systems. In this paper, we propose a novel context-aware hierarchical Bayesian method. First, we propose the use of spectral clustering for user-item subgrouping, so that users and items in similar contexts are grouped. We then propose a novel hierarchical Bayesian model that can make predictions for each user-item subgroup, our model incorporate not only topic modeling to mine item content but also social matrix factorization to handle ratings and social relationships. Experiments on an Epinions dataset show that our method significantly improves recommendation performance compared with six categories of state-of-the-art recommendation methods in terms of both prediction accuracy and recall. We have also conducted experiments to study the extent to which ratings, contexts, social relationships, and item contents contribute to recommendation performance in terms of prediction accuracy and recall.

Abstract:Over the past two decades, recommender systems have attracted a lot of interest due to the explosion in the amount of data in online applications. A particular attention has been paid to collaborative filtering, which is the most widely used in applications that involve information recommendations. Collaborative filtering (CF) uses the known preference of a group of users to make predictions and recommendations about the unknown preferences of other users (recommendations are made based on the past behavior of users). First introduced in the 1990s, a wide variety of increasingly successful models have been proposed. Due to the success of machine learning techniques in many areas, there has been a growing emphasis on the application of such algorithms in recommendation systems. In this article, we present an overview of the CF approaches for recommender systems, their two main categories, and their evaluation metrics. We focus on the application of classical Machine Learning algorithms to CF recommender systems by presenting their evolution from their first use-cases to advanced Machine Learning models. We attempt to provide a comprehensive and comparative overview of CF systems (with python implementations) that can serve as a guideline for research and practice in this area.

Abstract:Social-aware recommender systems have been popular with the rapid growth of social media applications. Existing approaches have attempted to accommodate social information into typical Collaborative Filtering methods and achieved significant improvements. Neural networks are gaining increasing interests in information retrieval tasks. However few studies have considered applying neural network in social-aware recommendation tasks. In this paper, we aim to fill this gap and propose a social-aware neural recommender system. Extensive experiments on real-world datasets demonstrate that our model outperforms state-of-art approaches significantly.

Abstract:Exponential growth of information generated by online social networks demands effective recommender systems to give useful results. Traditional techniques become unqualified because they ignore social relation data; existing social recommendation approaches consider social network structure, but social context has not been fully considered. It is significant and challenging to fuse social contextual factors which are derived from users' motivation of social behaviors into social recommendation. In this paper, we investigate social recommendation on the basis of psychology and sociology studies, which exhibit two important factors: individual preference and interpersonal influence. We first present the particular importance of these two factors in online item adoption and recommendation. Then we propose a novel probabilistic matrix factorization method to fuse them in latent spaces. We conduct experiments on both Facebook style bidirectional and Twitter style unidirectional social network datasets in China. The empirical result and analysis on these two large datasets demonstrate that our method significantly outperform the existing approaches.

Abstract:Collaborative Filtering has achieved great success in capturing users' preferences over items. However, existing techniques only consider limited collaborative signals, leading to unsatisfactory results when the user-item interactions are sparse. In this paper, we propose a Cross-grained Neural Collaborative Filtering model (CNCF), which enables recommendation more accurate and explainable. Specifically, we first construct four kinds of interaction graphs to model both fine-grained collaborative signals and coarse-grained collaborative signals, which can better compensate for the high sparsity of user-item interactions. Then we propose a fine-grained collaborative representation learning and design Light Attribute Prediction Networks ( ) to capture the high-order attribute interactions and enhance the prediction accuracy. Finally, we propose a coarse-grained collaborative representation learning to represent user preferences based on diverse latent intent factors. The experiments demonstrate the high effectiveness of our proposed model.

Abstract:Recently, with the emergence of a large number of social platforms, more and more works have been explored for social recommendation. On a social platform, social scientists converged that there exists social influence among users. Thus, accurately modeling the social influence could alleviate the data sparsity issue in Collaborative Filtering (CF). Most of the methods simply define the social influence with the normalized constant weights. However, this is not accuracy enough, which requires more reliable modeling. Besides, many studies have adopted neural network with CF in various recommendation tasks due to the effective ability of neural network for representation. In this paper, we attempt to apply attention mechanism based neural network structure for social recommendation. Specifically, social attention can weigh the contribution of social influence in the form of scores from each neighbor, and then generates each user's social context. Finally, extensive experimental results confirm the feasibility and effectiveness of our proposed model.
Towards Open-World Recommendation: An Inductive Model-based Collaborative Filtering Approach

Abstract:Recommendation models can effectively estimate underlying user interests and predict one's future behaviors by factorizing an observed user-item rating matrix into products of two sets of latent factors. However, the user-specific embedding factors can only be learned in a transductive way, making it difficult to handle new users on-the-fly. In this paper, we propose an inductive collaborative filtering framework that contains two representation models. The first model follows conventional matrix factorization which factorizes a group of key users' rating matrix to obtain meta latents. The second model resorts to attention-based structure learning that estimates hidden relations from query to key users and learns to leverage meta latents to inductively compute embeddings for query users via neural message passing. Our model enables inductive representation learning for users and meanwhile guarantees equivalent representation capacity as matrix factorization. Experiments demonstrate that our model achieves promising results for recommendation on few-shot users with limited training ratings and new unseen users which are commonly encountered in open-world recommender systems.

Abstract:Collaborative filtering (CF) is one of the most successful recommendation techniques due to its simplicity and attractive accuracy. However, existing CF methods fail to interpret the reasons why they recommend a new item. In this paper, we propose a Contextual-boosted Deep Neural Collaborative filtering (CDNC) model for item recommendation, which simultaneously exploits both item introductions (textual features) and user ratings (collaborative features) to alleviate the cold-start problem and provide interpretable item recommendation. Specifically, we propose an interactive attention mechanism to learn the user representation, which makes use of the mutual information from both the user ratings and item introductions to supervise the representation learning of each other. With the learned attention weights, we can obtain the importance of each historical item among the historical list. Meanwhile, the attention model can assign different weights to the words in item introductions according to their importance. Therefore, CDNC can provide interpretations for the recommendations by assigning different attention weights to the historically interacted items and the words in the item introductions. On the other hand, we also learn the distributed representations of new-coming items with deep neural networks (i.e., LSTM), considering both rating and item introduction information. Finally, the user representation and the representations of new-coming item are concatenated to perform recommendation score prediction. Extensive experiments on four public benchmarks demonstrate the effectiveness of CDNC. In addition, CDNC has the advantage of interpreting the recommendations and providing user profiles for down-stream applications. (C) 2019 Elsevier Ltd. All rights reserved.

Abstract:In the era of big data, recommender system (RS) has become an effective information filtering tool that alleviates information overload for Web users. Collaborative filtering (CF), as one of the most successful recommendation techniques, has been widely studied by various research institutions and industries and has been applied in practice. CF makes recommendations for the current active user using lots of users' historical rating information without analyzing the content of the information resource. However, in recent years, data sparsity and high dimensionality brought by big data have negatively affected the efficiency of the traditional CF-based recommendation approaches. In CF, the context information, such as time information and trust relationships among the friends, is introduced into RS to construct a training model to further improve the recommendation accuracy and user's satisfaction, and therefore, a variety of hybrid CF-based recommendation algorithms have emerged. In this paper, we mainly review and summarize the traditional CF-based approaches and techniques used in RS and study some recent hybrid CF-based recommendation approaches and techniques, including the latest hybrid memory-based and model-based CF recommendation algorithms. Finally, we discuss the potential impact that may improve the RS and future direction. In this paper, we aim at introducing the recent hybrid CF-based recommendation techniques fusing social networks to solve data sparsity and high dimensionality and provide a novel point of view to improve the performance of RS, thereby presenting a useful resource in the state-of-the-art research result for future researchers.

Abstract:In the current information era of enormous amount of data generation, recommendation systems are increasingly used as an efficient way to mitigate information overload in networks. The recommendation systems are used to provide more focused and personalized recommendation of relevant items based on user's historical preferences and constraints. An efficient recommendation system should enrich and improve end user experience. At present, recommendation systems commonly use traditional collaborative filtering algorithms to learn the hidden vectors from the user's commodity behavior matrix. Most of the traditional algorithms characterize data sparseness and cold start problems. Whilst deep learning is being utilized to accurately learn the auxiliary information to enhance the recommendation provided by collaborative filtering techniques, the implementation of deep learning should be fine-tuned in such a way that is satisfies specific application contexts. This paper intends to build a deep collaborative filtering model that integrates Convolutional Neural Networks and Multi-layer Perceptron, addressing the specific requirements of movie recommendation systems. Our proposed model can accurately capture the characteristics of local correlation and explicit and implicit feedback information. In the explicit recommendation task, implicit feedback search is used to embed similar groups, and multi-layer perceptron is used to model user projects, user similar project groups and project similar user groups. Experiments conducted based on the MovieLens dataset for predicting the movie scores demonstrate that our proposed algorithm improves the accuracy of movie score prediction, and outperforms notable traditional collaborative filtering algorithms in terms of alleviating the data sparseness and cold start problems.

Abstract:Context has been identified as an important factor in recommender systems. Lots of researches have been done for context-aware recommendation. However, in current approaches, the weights of contextual information are the same, which limits the accuracy of the results. This paper aims to propose a context-aware recommender system by extracting, measuring and incorporating significant contextual information in recommendation. The approach is based on rough set theory and collaborative filtering. It involves a three-steps process. At first, significant attributes to represent contextual information are extracted and measured to identify recommended items based on rough set theory. Then the users' similarity is measured in a target context consideration. Furthermore collaborative filtering is adopted to recommend appropriate items. The evaluation experiments show that the proposed approach is helpful to improve the recommendation quality.

Abstract:Recommender systems have become indispensable for recommending items of interest to users and have been successfully deployed in a wide range of real-world applications. In this paper, we exploit the community influence of users in social networks to improve the recommendation accuracy. Depending on the community in which the user is located, the user's preferences are defined more accurately. Specifically, we propose a community-based collaborative filtering method for social recommender systems, which makes full use of the rich link/community structure within a social network. We first group users in a social network into overlapping communities. Then we explicitly incorporate the community preference into the latent factor model. Compared with seven state-of-the-art methods on four real-world datasets, our method achieves the best performance.
Leveraging App Usage Contexts for App Recommendation: a Neural Approach.

Abstract:The large volume and variety of apps pose a great challenge for people to choose appropriate apps. As a consequence, app recommendation is becoming increasingly important. Recently, app usage data which record the sequence of apps being used by a user have become increasingly available. Such data record the usage context of each instance of app use, i.e., the app instances being used together with this app (within a short time window). Our empirical data analysis shows that a user has a pattern of app usage contexts. More importantly, the similarity in the two users’ preferences over mobile apps is correlated with the similarity in their app usage context patterns. Inspired by these important observations, this paper tries to leverage the predictive power of app usage context patterns for effective app recommendation. To this end, we propose a novel neural approach which learns the embeddings of both users and apps and then predicts a user’s preference for a given app. Our neural network structure models both a user’s preference over apps and the user’s app usage context pattern in a unified way. To address the issue of unbalanced training data, we introduce several sampling methods to sample user-app interactions and app usage contexts effectively. We conduct extensive experiments using a large real app usage data. Comparative results demonstrate that our approach achieves higher precision and recall, compared with the state-of-the-art recommendation methods.

Abstract:Recommendation system is an important module of many online systems. As one of the mainstream methods in the current recommendation system, the recommendation algorithm based on graph neural network can not only learn the cooperation signal between nodes, but also detect the nonlinear high-order information in node interaction. However, like the traditional collaborative filtering algorithm, the collaborative filtering method based on graph neural network only depends on the interaction information of existing users and projects, and the recommendation effect is poor in the scenario of sparse data. Although incorporating item attributes as auxiliary information into the recommendation algorithm can alleviate this problem to a certain extent, directly using the item attributes that users browse to construct user embedded vectors cannot contain users' implicit preferences. Therefore, this paper constructs a user–user network based on the interaction information between users and projects, analyzes it by using community detection, divides user groups with common interests, mines the potential attributes of users, and designs a collaborative filtering recommendation algorithm based on community detection and graph neural network. The research on two large real data sets shows that our method is superior to the standard recommendation method and the latest collaborative filtering recommendation method based on graph neural network.
