Abstract:SUMMARYAirborne electromagnetic (AEM) method detects the subsurface electrical resistivity structure by inverting the measured electromagnetic field. AEM data inversion is extremely time-consuming when huge volumes of observational data are involved. Forward modelling is an essential part and represents a large proportion of computational cost in the inversion process. In this study, we develop an AEM simulator using deep learning as a computationally efficient alternative to accelerate 1-D forward modelling. Inspired by Google's neural machine translation, our AEM simulator adopts the long short-term memory (LSTM) modules with an encoder–decoder structure, combining the advantages in time-series regression and feature extraction. The well-trained LSTM network describes directly the mapping relationship between resistivity models with transceiver altitudes and time-domain AEM signals. The prediction results of the test set show that 95 per cent of the relative errors at most sampling points fall in the range of ±5 per cent, with average values within the range of ±0.5 per cent, indicating an overall prediction accuracy. We investigate the effects of the distributions of both resistivity and transceiver altitude in the training set on the prediction accuracy. The LSTM-based AEM simulator can effectively handle the resistivity characteristics involved in the training set and yields great sensitivity to the variations of transceiver altitudes. We also examine the adaptability of our AEM simulator for discontinuous resistivity variations. Synthetic tests indicate that the application effect of the AEM simulator relies on the completeness of the training samples and suggest that enriching the sample diversity is necessary to ensure the prediction accuracy, in cases of observation environments dominated by extreme transceiver altitudes or under-represented geological features. Furthermore, we discuss the influence of network configuration on its accuracy and computational efficiency. Our simulator can deliver ∼13 600 1-D forward modelling calculations within 1 s, which significantly improves the simulation efficiency of AEM data.

Abstract:Accurate estimation of the Earth’s interior temperature is essential for solving fundamental scientific and applied geothermal problems. Currently, there is no universal method for determining deep temperature fields; however, such a method may be based on resistivity, a temperature-dependent proxy parameter. We propose an electromagnetic (EM) geothermometer based on the temperature–pressure coupled resistivity model (TPCRM). This geothermometer can accurately determine the relationship between the normalized resistivity, temperature, and pressure in deep formations based on well-logging, gravity, and EM data, thus allowing to visualize the temperature distribution. The TPCRM is utilized to predict the subsurface temperature in the Xiong’an New Area and shows an accuracy of 76.35%–96.58%. Sensitivity analysis of the critical variables of the TPCRM reveals that the TPCRM relatively weakly depends on the number of constraining boreholes and that the optimization of the subdivision spacing of the well-logging data can significantly improve temperature prediction accuracy. In addition, the effect of the spacing of inverted resistivity normalization grid nodes on the temperature prediction accuracy is relatively weak because the TPCRM considers the factor of the overburden pressure. The TPCRM is a promising tool for studying thermal genetic mechanisms, as well as fine evaluation of geothermal resources for their large-scale and efficient development and utilization.

Abstract:The ground-airborne frequency-domain electromagnetic method (GAFDEM) is a geophysical technique designed for the efficient exploration of resistivity imaging in areas characterized by complex terrain. Conventional frequency-domain transformation methods are limited in accurately capturing the amplitude and phase of time-varying electromagnetic responses due to various noise and interference. As a result, the resistivity imaging results may be inaccurate and even exhibit false anomalies. To address this issue, we propose a novel orthogonal recursive least squares (ORLSs) method. ORLS employs orthogonal signals as reference inputs and incorporates the adaptive filtering algorithm recursive least squares (RLSs), which enables real-time estimation of the amplitudes and phases of time-varying electromagnetic signals at multiple frequencies. The ORLS method overcomes the limitations of conventional frequency-domain transformation methods, such as the signal stationarity requirement and restricted frequency resolution. By ensuring real-time processing, ORLS enhances the accuracy of parameter estimation while maintaining efficiency. By simulating multifrequency signals and noisy data with different signal-to-noise ratios (SNRs), the effectiveness and stability of the ORLS algorithm are verified. Furthermore, the simulated and measured results are compared with frequency-domain analysis methods such as Fourier transform, which indicate that compared to frequency-domain analysis methods, the ORLS method reduces the average root mean square error (RMSE) of amplitude and phase by 57.79% and 85.97%, respectively, with similar estimation errors for each frequency component and no differences between frequencies. Moreover, the phase results of ORLS are easy to unwrap. Therefore, the GAFDEM data processed by the ORLS method hold significant importance in achieving high-precision underground resistivity imaging.

Instantaneous inversion of airborne electromagnetic data based on deep learning

Abstract:The airborne electromagnetic (AEM) method is becoming an effective means for subsurface electrical property reconstruction with the merits of terrain adaptability and acquisition efficiency. However, instantaneous inversion of time‐domain AEM data is still a challenge, owing to the huge amount of data. Inspired by Google's neural machine translation system, we develop a fast inversion operator guided by deep learning to translate time‐domain AEM measurements directly into subsurface resistivity structures. Trained by synthetic data, our system shows impressive adaptability to field observations and strong robustness against noise disturbance. Applied to the AEM dataset acquired by the U.S. Geological Survey (USGS) in Leach Lake Basin, CA, USA, our system successfully delivers results in seconds for a common PC from more than 740,000 AEM soundings. The inverted structures clearly delineate the geometries of the lake, surrounding mountains and faults. The inversion operator can support instantaneous subsurface resistivity reconstruction for AEM observations.

Physics-guided Deep Learning-Based Inversion for Airborne Electromagnetic Data

Abstract:The Earth's subsurface structure provides critical insights into sustainable resource management and geologic evolution. The airborne electromagnetic (AEM) method is an efficient data acquisition technique and can be used to image the underground resistivity structure with high spatial resolution. However, inversion of the increasingly huge volume of AEM data poses a heavy computational burden. In this study, we develop a hybrid deep learning-based approach by using the physics-guided neural network (PGNN) which incorporates the governing physical laws into the loss function to solve the AEM inverse problem. The PGNN integrates the strength of data-driven method for representation learning with electromagnetic laws and allows for the underlying physical constraints to be strictly satisfied. We validate the effectiveness of our approach using both synthetic and field datasets. Compared with the classic Gauss-Newton method, our PGNN inversion system shows strong robustness against multiple noise sources and reduces the risk of being trapped in local extrema. Moreover, the PGNN-inverted results are physically more consistent with the AEM observations compared to the purely data-driven approach. Application to the field AEM data from Northern Australia demonstrates that the PGNN-based inversion framework effectively estimates the subsurface electrical properties with considerable lateral continuity and significantly higher efficiency, completing the inversion of more than 2734000 AEM soundings taking only minutes on a common PC. Our proposed PGNN-based method shows great promise for large-scale underground resistivity imaging, and the well-identified subsurface resistivity structure can effectively improve our understanding of resource distributions and geological hazards.

Abstract:The wireless electromagnetic method (WEM) can be used to detect resources at the distances of up to 10 km underground, monitor and forecast earthquakes and fires, and study ionosphere and space weather. Based on the extremely low frequency (ELF) provided by a high-power artificial source, WEM has the advantages of strong anti-interference ability, stable signal, small measurement error, large transmitting dipole moment, and wide signal coverage. To apply the WEM to geophysical electromagnetic exploration and improve the reliability of calculation results, we study the analytical solution of the electromagnetic field in a spherical multilayer "earth–ionosphere" model, considering the displacement current in the air layer and the polarization and conductivity of the underground medium. We used Pade approximation to accelerate the numerical convergence and compare with the previous analytical and numerical results to verify the accuracy of our method. The characteristics of electromagnetic fields in different frequencies of the "earth–ionosphere" three-layer model excited by a vertical electric dipole and the influence of the earth's conductivity on electromagnetic fields are simulated. The reasonable range of air conductivity is discussed, providing a basis for other numerical calculation methods. In contrast to the conventional electromagnetic detection methods, the electromagnetic field will vibrate in the ELF range. With decreasing underground conductivity, the electromagnetic field at the surface will gradually weaken, and the resonance phenomenon will gradually disappear, indicating that this method can be applied for the detection of underground conductivity and will further improve the detection accuracy of WEM.

Estimating Three-Dimensional Resistivity Distribution with Magnetotelluric Data and a Deep Learning Algorithm

Abstract:In this study, we describe a deep learning (DL)-based workflow for the three-dimensional (3D) geophysical inversion of magnetotelluric (MT) data. We derived a mathematical connection between a 3D resistivity model and the surface-observed electric/magnetic field response by using a fully connected neural network framework (U-Net). Limited by computer hardware functionality, the resistivity models were generated by using a random walk technique to enlarge the generalization coverage of the neural network model, and 15,000 paired datasets were utilized to train and validate it. Grid search was used to select the optimal configuration parameters. With the optimal model framework from the parameter tuning phase, the metrics showed stable convergence during model training/validation. In the test period, the trained model was applied to predict the resistivity distribution by using both the simulated synthetic and the real MT data from the Mount Meager area, British Columbia. The reliability of the model prediction was verified with noised input data from the synthetic model. The calculated results can be used to reconstruct the position and shape trends of bodies with anomalous resistivity, which verifies the stability and performance of the DL-based 3D inversion algorithm and showcases its potential practical applications.

A damped forward EMI model for a horizontally stratified earth

Abstract:If a magnetic dipole is placed above the surface of the earth, the electromagnetic induction (EMI) effect, encoded in Maxwell's equations, causes eddy currents in the soil which, on their turn, induce response electromagnetic fields. The magnetic field can be measured in geophysical surveys to determine the conductivity profile of the ground in a non-destructive manner. The forward model used in the inversion of experimental data usually consists of a set of horizontal homogeneous layers. A frequently used analytical model, proposed by McNeill, does not include the interaction between the eddy currents and therefore fails for larger conductivities. In this paper, we construct a new forward, analytical, model to estimate the magnetic field caused by a horizontally stratified earth which approximates the interaction between eddy currents. This makes it valid for a broader range of parameters than the current state of the art. Furthermore, the error with the (numerically obtainable) exact result is substantially decreased. We also calculate the vertical sensitivity (“depth of exploration”) of the model and observe that it is in good agreement with the values obtained from the exact model.

Abstract:Deep underground laboratories offer advantages for conducting high-precision observations of weak geophysical signals, benefiting from a low background noise level. Enhancing strong, noisy ground electromagnetic (EM) field data using synchronously recorded underground EM signals, which typically exhibit a high signal-to-noise ratio, is both valuable and feasible. In this study, we propose an EM field reconstruction method employing a Long Short-Term Memory (LSTM) recurrent neural network with referenced deep underground EM observations. Initially, a deep learning model was developed to capture the time-varying features of underground multi-component EM fields using the LSTM recurrent neural network. Subsequently, this model was applied to process synchronously observed strong, noisy data from other conventional observation systems, such as those at the surface, to achieve noise suppression through signal reconstructions. Both the theoretical analysis and the practical observational data suggest that the proposed method effectively suppresses noise and reconstructs clean EM signals. This method is efficient and time-saving, representing an effective approach to fully utilizing the advantages of deep underground observation data. Furthermore, this method could be extended to the processing and analysis of other geophysical data.

Abstract:The accurate observation of earth resistivity is an effective method for earthquake prediction.In the face of increasingly severe electromagnetic interference,a method of ground resistivity observation based on coded source circular cross-correlation identification is proposed.The measured geoelectrical structure can be treated as the system to be identified,using the coded current signal excited by power supply electrodes A and B as the input signal of the system,and the voltage signal between the electrodes M and N is the system output response,and the input and output signals are synchronously sampled into the time series,then a reference signal is generated according to sampled coded current time series.Next,the circular cross-correlation operation between input signal and the reference signal,and between output signal and the reference signal were performed separately,and the cross-correlation time series were converted into the frequency domain by fast Fourier transform and the apparent resistivity spectrum (amplitude and phase) of the earth to be detected can be deduced.A short experiment using this method was carried out at two stations of Lanzhou observatory and Hanwang station,the results showed that this method has a strong ability to restrain noise,and can achieve high frequency resolution and measurement accuracy.The multi-frequency apparent resistivity spectrum provides the conditions for the removal of electromagnetic coupling.The feasible technical scheme is put forward in this project,want to develop instrument,to optimize the main experimental parameters,and get a higher precision resistivity monitoring and the phase monitoring ability.The result can provide the data support for the study of the characteristics of time,location and intensity of seismic anomaly information and its relationship with strong earthquakes,and it also has practical significance and application value in the field of earthquake prevention and disaster reduction.

Abstract:The semi-airborne transient electromagnetic method is characterized by a large detection depth, high signal-to-noise ratio, fast acquisition rate, low cost, and ability to be used for exploration in scenarios with complex geological conditions. As a result, the semi-airborne transient electromagnetic method has a great potential in the fields of mineral exploration, hydrological study and geohazard detection. However, most of the existing semi-airborne transient electromagnetic data interpretation methods still rely on one-dimensional forward modelling and inversion, which could lead to an incorrect geological interpretation. In this paper, we develop a three-dimensional inversion for semi-airborne transient electromagnetic data to recover a reliable subsurface conductivity distribution. The forward modelling is based on the effective vector finite element method with an unstructured tetrahedral mesh, which is capable of simulating complex geo-electric structures and the topography. Through the numerical experiments of several three-dimensional synthetic models, we study the influence of the number of excitation sources, flight mode and complex topography on the inversion results. The synthetic model studies reveal that: (1) by increasing the number of excitation sources, we can obtain a higher resolution conductivity image with less artefacts; (2) the detectability can be increased by flying along the terrain when the topography is complex; (3) the topography should be considered in the forward modelling and inversion to obtain a reasonable conductivity model using the semi-airborne transient electromagnetic method; and (4) the three-dimensional inversion still works when the inhomogeneity is present nearby the transmitter.
Near real-time subsurface structure imaging using airborne electromagnetic data based on deep learning

Abstract:The airborne electromagnetic (AEM) method is a modern technique in geophysical surveys with the merits of terrain adaptability and acquisition efficiency, and can image the electrical structure of the Earth&#8217;s subsurface down to several hundred meters. AEM survey has been applied extensively in mineral exploration, groundwater monitoring, environment investigation and geological mapping. However, the expansion of survey area and spatial sampling bring about huge volumes of AEM data, which present a serious computational challenge for rapid AEM inversion. Inspired by Google&#8217;s neural machine translation system, we develop a fast inversion system guided by deep learning to translate AEM data directly into subsurface resistivity structures. Synthetic tests demonstrate that our proposed inversion system has strong noise robustness and can provide reliable inversion results much more efficiently than the conventional Gauss-Newton algorithm. In the field data application, our system obtains robust inversion results of more than 740,000 AEM soundings acquired by the U.S. Geological Survey from the Leach Lake Basin in California in seconds on a common PC. The inverted images coincide exactly with previous studies of the local geological environment and clearly outline the geometries of the lake, faults and surrounding mountains. Our inversion system can support near real-time underground subsurface imaging for AEM surveys and inject new vigor into resource exploration and tectonic studies.
Continental-scale deep electrical resistivity structure beneath China

Abstract:Electrical resistivity structure in the deep Earth can provide important information and constraints on regional geodynamics, especially in regions with complex tectonics and geodynamical processes. In this study, we image the electrical resistivity structure in the depth range of 350–1200 km beneath China by inverting the frequency-dependent ratios of geomagnetic field components at a relatively dense network of geomagnetic observatories. Very long time series of hourly mean values of the three-component geomagnetic field from 45 geomagnetic observatories are collected and processed to derive robust ratios of the geomagnetic components, which are then converted to the apparent resistivities and impedance phases in the period range of 5.3–113.8 days and used in 1-D Occam inversion with smoothing constraint and the ρ + method to obtain the electrical resistivity profiles and delta function models at individual observatories. 1-D electrical resistivity models suggest that low electrical resistivity structure exists in the mantle transition zone beneath eastern China. High water content in the mantle minerals due to the subduction of seismically fast Pacific slab is proposed as the main reason for the low electrical resistivity beneath eastern China. Our results provide further evidence that the western front of the subducting Pacific slab in the mantle transition zone roughly coincides with the abrupt change in the surface topography in eastern China.

Abstract:In many cases, 1D inversion is still an important step in transient electromagnetic data processing. Potential issues may arise in the calculation of apparent resistivity using induced electromotive force (EMF) due to overshoot and the presence of multi-valued functions. Obtaining reliable and consistent inversion results using a uniform half-space as the initial model is challenging, especially when aiming for efficient inversion. Focusing on these problems, we use the land-based transient electromagnetic (TEM) sounding data, which was acquired by using a large fixed-loop transmitter, and adopt a quasi-2D inversion scheme to generate improved images of the subsurface resistivity structure. First, we have considered directly using magnetic field data or converting induced EMF into magnetic field, and then calculating the apparent resistivity over the whole zone. Next, a resistivity profile that varies with depth is obtained through fast smoke ring imaging. This profile serves as the initial model for the subsequent optimal inversion. The inversion scheme uses a nonlinear least-squares method, incorporating lateral and vertical constraints, to produce a quasi-2D subsurface image. The potentiality of the proposed methodology has been exemplified through the interpretation of synthetic data derived from a 3D intricate resistivity model, as well as field data obtained from a TEM survey conducted in a coalmine field. In both cases, the inversion process yields quasi-2D subsurface images that exhibit a reasonable level of accuracy. These images appear to be less moulded by 3D effects and demonstrate a satisfactory level of agreement with the known target area.

Abstract:The topography of the foreland thrust zone in western China is complicated. In those areas, the mountains are steep and the loess layer is thick, which cause the quality of seismic data in these areas is poor. With continuous research in recent years, the quality of seismic data has been improved to some extent. However, it is still difficult to identify the structural traps and build accurate velocity model. It has received a better exploration results on the recognition of loess characteristics and distribution with transient electromagnetic method in the foreland thrust zone. In this paper, the achievement of detecting near surface loess layer in western China using transient electromagnetic exploration is shown. It can be combined with micro-logging to provide the basis for building shallow velocity model for the static correction of the seismic data
Deep Learning to Estimate Permeability using Geophysical Data

Abstract:Time-lapse electrical resistivity tomography (ERT) is a popular geophysical method to estimate three-dimensional (3D) permeability fields from electrical potential difference measurements. Traditional inversion and data assimilation methods are used to ingest this ERT data into hydrogeophysical models to estimate permeability. Due to ill-posedness and the curse of dimensionality, existing inversion strategies provide poor estimates and low resolution of the 3D permeability field. Recent advances in deep learning provide us with powerful algorithms to overcome this challenge. This paper presents a deep learning (DL) framework to estimate the 3D subsurface permeability from time-lapse ERT data. To test the feasibility of the proposed framework, we train DL-enabled inverse models on simulation data. Subsurface process models based on hydrogeophysics are used to generate this synthetic data for deep learning analyses. Results show that proposed weak supervised learning can capture salient spatial features in the 3D permeability field. Quantitatively, the average mean squared error (in terms of the natural log) on the strongly labeled training, validation, and test datasets is less than 0.5. The R2-score (global metric) is greater than 0.75, and the percent error in each cell (local metric) is less than 10%. Finally, an added benefit in terms of computational cost is that the proposed DL-based inverse model is at least O(104) times faster than running a forward model. Note that traditional inversion may require multiple forward model simulations (e.g., in the order of 10 to 1000), which are very expensive. This computational savings (O(105) - O(107)) makes the proposed DL-based inverse model attractive for subsurface imaging and real-time ERT monitoring applications due to fast and yet reasonably accurate estimations of the permeability field.

Numerical analysis of resistivity variation of horizontal multi-layer earth and its application in earthquake prediction

Abstract:Analyzing the stratum resistivity variation is one of the basic methods to predict earthquake. In this paper, a method for estimating the resistivity variation of horizontal multi-layer earth from the test data by Wenner's method is presented. The partial derivatives of the earth apparent resistivities with respect to the earth parameters, which are improper integrals with Bessel's function, are efficiently calculated by complex image method. ©2006 IEEE.
MODIS-driven Estimation of Terrestrial Latent Heat Flux in China Based on a Modified Priestley–Taylor Algorithm

Abstract:Because of China's large size, satellite observations are necessary for estimation of the land surface latent heat flux (LE). We describe here a satellite-driven Priestley-Taylor (PT)-based algorithm constrained by the Normalized Difference Vegetation Index (NDVI) and Apparent Thermal Inertia (ATI) derived from temperature change over time. We compare to the satellite-driven PT-based approach, PT-JPL, and validate both models using data collected from 16 eddy covariance flux towers in China. Like PT-JPL, our proposed algorithm avoids the computational complexities of aerodynamic resistance parameters. We run the algorithms with monthly Moderate Resolution Imaging Spectroradiometer (MODIS) products (0.05 degrees resolution), including albedo, Land Surface Temperature (LST), surface emissivity, and NDVI; and, Insolation from the Japan Aerospace Exploration Agency (JAXA). We find good agreement between our estimates of monthly LE and field-measured LE, with respective Root Mean Square Error (RMSE) and bias differences of 12.5 Wm(-2) and -6.4Wm(-2). As compared with PT-JPL, our proposed algorithm has higher correlations with ground-measurements. Between 2001 and 2010, LE shows generally negative trends in most regions of China, though positive LE trends occur over 39% of the region, primarily in Northeast, North and South China. Our results indicate that the variations of terrestrial LE are responding to large-scale droughts and afforestation caused by human activity with direct links to terrestrial energy exchange, both spatially and temporally. Apparent Resistivity for Transient Electromagnetic Induction Logging and Its Correction in Radial Layer Identification

Abstract:We propose an algorithm for calculating all-time apparent resistivity from transient electromagnetic induction logging. The algorithm is based on the whole-space transient electric field expression of the uniform model and Halley's optimisation. In trial calculations for uniform models, the all-time algorithm is shown to have high accuracy. We use the finite-difference time-domain method to simulate the transient electromagnetic field in radial two-layer models without wall rock and convert the simulation results to apparent resistivity using the all-time algorithm. The time-varying apparent resistivity reflects the radially layered geoelectrical structure of the models and the apparent resistivity of the earliest time channel follows the true resistivity of the inner layer; however, the apparent resistivity at larger times reflects the comprehensive electrical characteristics of the inner and outer layers. To accurately identify the outer layer resistivity based on the series relationship model of the layered resistance, the apparent resistivity and diffusion depth of the different time channels are approximately replaced by related model parameters; that is, we propose an apparent resistivity correction algorithm. By correcting the time-varying apparent resistivity of radial two-layer models, we show that the correction results reflect the radially layered electrical structure and the corrected resistivities of the larger time channels follow the outer layer resistivity. The transient electromagnetic fields of radially layered models with wall rock are simulated to obtain the 2D time-varying profiles of the apparent resistivity and corrections. The results suggest that the time-varying apparent resistivity and correction results reflect the vertical and radial geoelectrical structures. For models with small wall-rock effect, the correction removes the effect of the low-resistance inner layer on the apparent resistivity of the larger time channels.

Abstract:During airborne transient electromagnetic (EM) surveys, transmitting and receiving antennas change their attitudes as the inevitable result of pilot maneuvers and natural forces, which makes the EM response different from that of the nominal attitudes when the antennas are straight and level. Attitude changes were usually neglected or partially considered in the past, which are not adequate for a quantitative interpretation. In this letter, we first scrutinize the mechanism of how the attitude change affects the EM response and divides these effects into two parts: the pure attitude effect and the resultant translation effect. Then, we introduce a novel method to involve the full attitude change in both modeling and inversion. Our compelling results finally demonstrate that the attitude change affects the early-time response much more than the late time and involving the full change in inversion can produce a better estimate of shallow geoelectric parameters.
