Abstract:Specialized hardware accelerator has emerged as an efficient approach to mitigate the issue of power wall. Most accelerator designs focus on accelerator RTL synthesis, and place little focus on the communications between core and accelerator, thereby potentially limiting overall system performance. This paper presents an accelerator-aware micro-architectural simulator that supports accelerator design using high-level language (HLL) description, e.g., C++. The paper also discusses the design of a complete software stack for the simulator, from programming model, user configurability, to power profiler. Designers can then use the tool to conduct case studies and make performance analyses for design space exploration.

Abstract:Domain-specific accelerators are a reaction adapting to device scaling and the dark silicon era. This paper describes a radar signal processing oriented configurable accelerator and the application space exploration of the system. The system is built around accelerator engines and general-purpose processors (GPPs) that make it suitable for intensive computing kernel acceleration and complex control tasks. It is geared toward high-performance radar digital signal processing; we characterize the applications and find that each of them contains a series of serializable kernels. Taking advantage of this discovery, we design an algorithm pool that shares the same computation resource and memory resource, and each algorithm is size reconfigurable. On the other hand, shared on-chip addressable scratchpad memory eliminates unnecessary explicit data copy between accelerators. Performance of the system is evaluated from measurements performed both on an FPGA SoC test chip and on a prototype chip fabricated by CMOS 40 nm technology. The experimental results show that for different algorithms, the proposed system achieves 1.9× to 10.1× performance gain compared with a state-of-the-art TI DSP chip. In order to characterize the application of the system, a complex real-life task is adopted, and the results show that it can obtain high throughput and desirable precision.
Efficiently Emulating High-Bitwidth Computation with Low-Bitwidth Hardware

Abstract:Domain-Specific Accelerators (DSAs) are being rapidly developed to support high-performance domain-specific computation. Although DSAs provide massive computation capability, they often only support limited native data types. To mitigate this problem, previous works have explored software emulation for certain data types, which provides some compensation for hardware limitations. However, how to efficiently design more emulated data types and choose a high-performance one without hurting correctness or precision for a given application still remains an open problem. To address these challenges, we present Ape, which can 1) provide different strategies for emulating high-bitwidth data types using native data types with in-depth error analysis; 2) dynamically and automatically select proper data types and generate efficient code for a given computation in fine-granularity to achieve higher performance while maintaining both correctness and precision at the same time without human efforts. We implement Ape on both NVIDIA Tensor Core and Huawei Ascend. Results show that Ape can boost General Matrix Multiplication and convolution by up to 3.12X and 1.86X on Tensor Core over CUDA Core and accelerate various applications by up to 1.78X (1.65X on average).

Abstract:As semiconductor power density is no longer constant with the technology process scaling down, modern CPUs are integrating capable data accelerators on chip, aiming to improve performance and efficiency for a wide range of applications and usages. One such accelerator is the Intel Data Streaming Accelerator (DSA) introduced in Intel 4th Generation Xeon Scalable CPUs (Sapphire Rapids). DSA targets data movement operations in memory that are common sources of overhead in datacenter workloads and infrastructure. In addition, it becomes much more versatile by supporting a wider range of operations on streaming data, such as CRC32 calculations, delta record creation/merging, and data integrity field (DIF) operations. This paper sets out to introduce the latest features supported by DSA, deep-dive into its versatility, and analyze its throughput benefits through a comprehensive evaluation. Along with the analysis of its characteristics, and the rich software ecosystem of DSA, we summarize several insights and guidelines for the programmer to make the most out of DSA, and use an in-depth case study of DPDK Vhost to demonstrate how these guidelines benefit a real application.

Abstract:The widely adoption of media processing applications provides great challenges to high performance embedded processor design. This paper studies a Data Parallel Coprocessor architecture based on SDTA and architecture de-cisions are made for the best performance/cost ratio. Experimental results on a prototype show that SDTA has high performance to run many embedded media processing applications. The simplicity and flexibility of SDTA encourages for further development for its reconfigurable functionality.

Abstract:As an energy-efficient hardware solution for deep neural network (DNN) inference, systolic accelerators are particularly popular in both embedded and datacenter computing scenarios. Despite their excellent performance and energy efficiency, however, systolic DNN accelerators are naturally facing a resource under-utilization problem - not all DNN models can well match the fixed processing elements (PEs) in a systolic array implementation, because typical DNN models vary significantly from applications to applications. Consequently, state-of-the-art hardware solutions are not expected to deliver the nominal (peak) performance and energy efficiency as claimed because of resource under-utilization. To deal with this dilemma, this study proposes a novel systolic DNN accelerator with a flexible computation mapping and dataflow scheme. By providing three types of parallelism and dynamically switching among them: channel-direction mapping, planar mapping, and hybrid, our accelerator offers the adaptability to match various DNN models to the fixed hardware resources, and thus, enables flexibly exploiting PE provision and data reuse for a wide range of DNN models to achieve optimal performance and energy efficiency.

Abstract:The research interest in specialized hardware accelerators for deep neural networks (DNN) spikes recently owing to their superior performance and efficiency. However, today's DNN accelerators primarily focus on accelerating specific "kernels" such as convolution and matrix multiplication, which are vital but only part of an end-to-end DNN-enabled application. Meaningful speedups over the entire application often require supporting computations that are, while massively parallel, ill-suited to DNN accelerators. Integrating a general-purpose processor such as a CPU or a GPU incurs significant data movement overhead and leads to resource under-utilization on the DNN accelerators. We propose Simultaneous Multi-mode Architecture (SMA), a novel architecture design and execution model that offers general-purpose programmability on DNN accelerators in order to accelerate end-to-end applications. The key to SMA is the temporal integration of the systolic execution model with the GPU-like SIMD execution model. The SMA exploits the common components shared between the systolic-array accelerator and the GPU, and provides lightweight reconfiguration capability to switch between the two modes in-situ. The SMA achieves up to 63% performance improvement while consuming 23% less energy than the baseline Volta architecture with TensorCore.

Abstract:GA Acceleration based on GPU + CPU is no vantage in its area and power consumption. In this paper, we established an innovative chip structure of domain general integrated circuit (DGIC) to sever as a scheme of the IoT node, in which mainly involves the virtualization technology of cloud computing, including the resource virtualization and the virtualization architecture. Take these virtualized IP core component resources as concrete execution step to form a semantic process, and its execution can be driven by an engine of the virtualization architecture. Through restructure of its semantic process, an application scenario can be expressed as a names series of these logical resources, so such it is mapped to its virtualized resources set step-by-step. In this way, as an ASIC, a DGIC chip is endowed with the CPU’s characteristics that can update its program flow to adapt to diverse application scenarios. In this paper, we delivered a DGIC sample in the GA acceleration domain, and tested a genetic algorithm based on Xilinx FPGA V5. Its acceleration ratio is notably better than the present GPU + CPU approach, while its valuable advantages are in its size and power consumption.

Abstract:In this paper, we explore the possibility of hardware acceleration implementation of sparse coding algorithm with spintronic devices by a series of design optimizations across the architecture, circuit and device. Firstly, a domain wall motion (DWM) based compound spintronic device (CSD) is engineered and modelled, which is envisioned to achieve multiple conductance states. Sequentially, a parallel architecture is presented based on a dense cross-point array of the proposed DWM based CSD, where each dictionary (D) value can be mapped into the conductance of the proposed DWM based CSD at the corresponding cross-point. Benefitting from its massively parallel read and write operation, such proposed parallel architecture can accelerate the selected sparse coding algorithm using a designed dedicated periphery read and write circuit. Experimental results show that the selected sparse coding algorithm can be accelerated by 1400x with the proposed parallel architecture in comparison with software implementation. Moreover, its energy dissipation is 8 orders of magnitude smaller than that with software implementation.

Abstract:As deep learning (DL) plays an increasingly significant role in several fields, designing a high performance, low power, low-latency hardware accelerator for DL has become a topic of interest in the field of architecture. Based on the structure and optimization method of DL algorithms, this study aims to analyze the difficulties and challenges in DL hardware design. In comparison with the current mainstream DL hardware acceleration platform, advantages of the DL hardware acceleration based on general vector DSP are discussed. Besides, acceleration techniques, such as vector broadcasting and matrix conversion, are described. From the viewpoint of the shortcomings of the general vector DSP discussed herein, optimization techniques such as reconfigurable computing arrays that take into account the general vector calculations as well as specific DL acceleration are discussed in depth.
The Magnificent Seven Challenges and Opportunities in Domain-Specific Accelerator Design for Autonomous Systems

Abstract:The end of Moore's Law and Dennard Scaling has combined with advances in agile hardware design to foster a golden age of domain-specific acceleration. However, this new frontier of computing opportunities is not without pitfalls. As computer architects approach unfamiliar domains, we have seen common themes emerge in the challenges that can hinder progress in the development of useful acceleration. In this work, we present the Magnificent Seven Challenges in domain-specific accelerator design that can guide adventurous architects to contribute meaningfully to novel application domains. Although these challenges appear across domains ranging from ML to genomics, we examine them through the lens of autonomous systems as a motivating example in this work. To that end, we identify opportunities for the path forward in a successful domain-specific accelerator design from these challenges.

Heterogeneous Dataflow Accelerators for Multi-DNN Workloads

Abstract:Emerging AI-enabled applications such as augmented/virtual reality (AR/VR) leverage multiple deep neural network (DNN) models for sub-tasks such as object detection, hand tracking, and so on. Because of the diversity of the sub-tasks, the layers within and across the DNN models are highly heterogeneous in operation and shape. Such layer heterogeneity is a challenge for a fixed dataflow accelerator (FDA) that employs a fixed dataflow on a single accelerator substrate since each layer prefers different dataflows (computation order and parallelization) and tile sizes. Reconfigurable DNN accelerators (RDAs) have been proposed to adapt their dataflows to diverse layers to address the challenge. However, the dataflow flexibility in RDAs is enabled at the area and energy costs of expensive hardware structures (switches, controller, etc.) and per-layer reconfiguration. Alternatively, this work proposes a new class of accelerators, heterogeneous dataflow accelerators (HDAs), which deploys multiple sub-accelerators each supporting a different dataflow. HDAs enable coarser-grained dataflow flexibility than RDAs with higher energy efficiency and lower area cost comparable to FDAs. To exploit such benefits, hardware resource partitioning across sub-accelerators and layer execution schedule need to be carefully optimized. Therefore, we also present Herald, which co-optimizes hardware partitioning and layer execution schedule. Using Herald on a suite of AR/VR and MLPerf workloads, we identify a promising HDA architecture, Maelstrom, which demonstrates 65.3% lower latency and 5.0% lower energy than the best FDAs and 22.0% lower energy at the cost of 20.7% higher latency than a state-of-the-art RDA. The results suggest that HDA is an alternative class of Pareto-optimal accelerators to RDA with strength in energy, which can be a better choice than RDAs depending on the use cases.

A decoupled access-execute architecture for reconfigurable accelerators

Abstract:Mapping computational intensive applications on reconfigurable technology for acceleration requires two main implementation parts: (a) the data plane, i.e., efficient interconnected units that accelerate processing, and (b) the access-plane, i.e., efficient ways to access data and transfer them to/from the accelerator. Data plane construction is well understood and mature tools -such as High Level Synthesis (HLS)- that produce efficient reconfigurable architectures exist. The access plane, however, is more challenging: data fetching for big-data and high-performance computing applications is even more complex and time consuming than processing. Towards this end, we present DAER, a Decoupled Access-Execute architecture and framework for Reconfigurable accelerators. Our approach maps the code to be accelerated in two separate parts: (a) the fetch unit, responsible for fetching data to the accelerator and storing results back in memory, and (b) the processing unit, which processes the fetched data in a streaming way. This approach offers the user a structured and well-defined way of mapping applications on an FPGA. Additionally, it bodes well with other hardware-based optimization techniques, e.g. pipelining, custom processing and data prefetching, which hide the memory data access latency. We use the DAER framework and HLS mapping tools on five applications and show the proposed DAER framework achieves an order of magnitude performance speed-up compared to unmodified applications, and as much as 2x performance improvement compared to their optimized HLS versions. We, also, map the DAER-based architectures on HPC platforms showing the performance advantages of our approach on real world platforms.
Software-defined Design Space Exploration for an Efficient DNN Accelerator Architecture

Abstract:Deep neural networks (DNNs) have been shown to outperform conventional machine learning algorithms across a wide range of applications, e.g., image recognition, object detection, robotics, and natural language processing. However, the high computational complexity of DNNs often necessitates extremely fast and efficient hardware. The problem gets worse as the size of neural networks grows exponentially. As a result, customized hardware accelerators have been developed to accelerate DNN processing without sacrificing model accuracy. However, previous accelerator design studies have not fully considered the characteristics of the target applications, which may lead to sub-optimal architecture designs. On the other hand, new DNN models have been developed for better accuracy, but their compatibility with the underlying hardware accelerator is often overlooked. In this article, we propose an application-driven framework for architectural design space exploration of DNN accelerators. This framework is based on a hardware analytical model of individual DNN operations. It models the accelerator design task as a multi-dimensional optimization problem. We demonstrate that it can be efficaciously used in application-driven accelerator architecture design. Given a target DNN, the framework can generate efficient accelerator design solutions with optimized performance and area. Furthermore, we explore the opportunity to use the framework for accelerator configuration optimization under simultaneous diverse DNN applications. The framework is also capable of improving neural network models to best fit the underlying hardware resources.

AutoDSE: Enabling Software Programmers to Design Efficient FPGA Accelerators

Abstract:Adopting FPGA as an accelerator in datacenters is becoming mainstream for customized computing, but the fact that FPGAs are hard to program creates a steep learning curve for software programmers. Even with the help of high-level synthesis (HLS), accelerator designers still have to manually perform code reconstruction and cumbersome parameter tuning to achieve the optimal performance. While many learning models have been leveraged by existing work to automate the design of efficient accelerators, the unpredictability of modern HLS tools becomes a major obstacle for them to maintain high accuracy. To address this problem, we propose an automated DSE framework-AutoDSE- that leverages a bottleneck-guided coordinate optimizer to systematically find a better design point. AutoDSE detects the bottleneck of the design in each step and focuses on high-impact parameters to overcome it. The experimental results show that AutoDSE is able to identify the design point that achieves, on the geometric mean, 19.9x speedup over one CPU core for Machsuite and Rodinia benchmarks. Compared to the manually optimized HLS vision kernels in Xilinx Vitis libraries, AutoDSE can reduce their optimization pragmas by 26.38x while achieving similar performance. With less than one optimization pragma per design on average, we are making progress towards democratizing customizable computing by enabling software programmers to design efficient FPGA accelerators.

Abstract:In scientific applications, the computing process is composed of stream computing and general computing. The performance of computing is limited by low parallelism and hard streamlization. We propose what we call DAMS-Cache (DAMS stands for Dynamical Address Mapping Stream), which can be controlled by both the software and hardware that manage an on-chip memory structure that can, we believe, suppress effectively the above-mentioned limitation. Sections 1 through 4 of the full paper explain DAMS-Cache, whose core consists of: (1) the memory system can support both stream computing and scalar data processing in high performance, which supports irregular stream and conditionally-loaded stream computing by hardware; (2) the DAMS Cache explores both coarse-grained producer-consumer locality and fine-grained temporal/spatial locality by using replacement strategy of mixed data structure; (3) in order to avoid address mapping conflict, the dynamically adaptive storage resource assignment strategy and dynamically adaptive address mapping strategy are also presented. Section 5 presents performance analysis of DAMS Cache; it shows preliminarily that DAMS Cache has better adaptability and high performance compared with Scratchpad Memory and traditional Cache.
Efficient Hardware Accelerator Based on Medium Granularity Dataflow for SpTRSV

Abstract:Sparse triangular solve (SpTRSV) is widely used in various domains. Numerous studies have been conducted using CPUs, GPUs, and specific hardware accelerators, where dataflow can be categorized into coarse and fine granularity. Coarse dataflow offers good spatial locality but suffers from low parallelism, while fine dataflow provides high parallelism but disrupts the spatial structure, leading to increased nodes and poor data reuse. This paper proposes a novel hardware accelerator for SpTRSV or SpTRSV-like DAGs. The accelerator implements a medium granularity dataflow through hardware-software codesign and achieves both excellent spatial locality and high parallelism. Additionally, a partial sum caching mechanism is introduced to reduce the blocking frequency of processing elements (PEs), and a reordering algorithm of intra-node edges computation is developed to enhance data reuse. Experimental results on 264 benchmarks with node counts reaching up to 85,392 demonstrate that this work achieves average performance improvements of 12.2$\times$ (up to 874.5$\times$) over CPUs and 10.1$\times$ (up to 740.4$\times$) over GPUs. Compared to the state-of-the-art technique (DPU-v2), this work shows a 2.5$\times$ (up to 5.9$\times$) average performance improvement and 1.8$\times$ (up to 4.1$\times$) average energy efficiency enhancement.

Thanks to specialization, they can achieve high performance and energy efficiency but their design is complex and time consuming. This problem is exacerbated when large amounts of data must be processed, like in modern big data and machine learning applications. The designer has not only to optimize the accelerator logic but also produce efficient memory architectures. To simplify this process, we propose a multi-level compilation flow that specializes a domain-specific memory template to match data, application, and technology requirements.
Being-ahead: Benchmarking and Exploring Accelerators for Hardware-Efficient AI Deployment

Abstract:Customized hardware accelerators have been developed to provide improved performance and efficiency for DNN inference and training. However, the existing hardware accelerators may not always be suitable for handling various DNN models as their architecture paradigms and configuration tradeoffs are highly application-specific. It is important to benchmark the accelerator candidates in the earliest stage to gather comprehensive performance metrics and locate the potential bottlenecks. Further demands also emerge after benchmarking, which require adequate solutions to address the bottlenecks and improve the current designs for targeted workloads. To achieve these goals, in this paper, we leverage an automation tool called DNNExplorer for benchmarking customized DNN hardware accelerators and exploring novel accelerator designs with improved performance and efficiency. Key features include (1) direct support to popular machine learning frameworks for DNN workload analysis and accurate analytical models for fast accelerator benchmarking; (2) a novel accelerator design paradigm with high-dimensional design space support and fine-grained adjustability to overcome the existing design drawbacks; and (3) a design space exploration (DSE) engine to generate optimized accelerators by considering targeted AI workloads and available hardware resources. Results show that accelerators adopting the proposed novel paradigm can deliver up to 4.2X higher throughput (GOP/s) than the state-of-the-art pipeline design in DNNBuilder and up to 2.0X improved efficiency than the recently published generic design in HybridDNN given the same DNN model and resource budgets. With DNNExplorer's benchmarking and exploration features, we can be ahead at building and optimizing customized AI accelerators and enable more efficient AI applications.
