Abstract:The high-precision load prediction technology plays a vital role in load control and health management for gas turbines. Low-calorific fuel fired gas turbines pose an especially significant challenge for load prediction due to the frequent and wide fluctuations of gas parameters. First, an improved hybrid-dimension physical-based model is proposed, which is corrected based on segmented operation data and integrates zero-dimensional thermodynamic knowledge of gas turbines with three-dimensional fluid dynamics simulation knowledge. Secondly, an optimal data-driven model is proposed through conducting a systematic comparative study on four popular machine learning models with two types of input variables feature extraction. Then, a novel hybrid model is proposed based on the improved physical-based model, optimal data-driven model, and the principle of minimizing hybrid model errors. The average relative prediction error of the hybrid model over the complete operation range is 0.68%. Compared with the physical-based model and the data-driven model, the proposed hybrid model can improve the prediction accuracy by 63% and 29%, respectively. As the high-calorific fuel fired gas turbine system is relatively simple and has a small range of fuel fluctuations, the method established in this paper can be extended to high-calorific fuel fired gas turbines, which is of great significance for promoting the dynamic balance of loads in a new type of electric power system based on new energy.

Abstract:To tackle the challenges of high variability and low accuracy in short-term electricity load forecasting, this study introduces an enhanced prediction model that addresses overfitting issues by integrating an error-optimal weighting approach with an improved ensemble forecasting framework. The model employs a hybrid algorithm combining grey relational analysis and radial kernel principal component analysis to preprocess the multi-dimensional input data. It then leverages an ensemble of an optimized deep bidirectional gated recurrent unit (BiGRU), an enhanced long short-term memory (LSTM) network, and an advanced temporal convolutional neural network (TCN) to generate predictions. These predictions are refined using an error-optimal weighting scheme to yield the final forecasts. Furthermore, a Bayesian-optimized Bagging and Extreme Gradient Boosting (XGBoost) ensemble model is applied to minimize prediction errors. Comparative analysis with existing forecasting models demonstrates superior performance, with an average absolute percentage error (MAPE) of 1.05% and a coefficient of determination (R2) of 0.9878. These results not only validate the efficacy of our proposed strategy, but also highlight its potential to enhance the precision of short-term load forecasting, thereby contributing to the stability of power systems and supporting societal production needs.

Abstract:Natural gas firmly plays the crucial role in the transition through low-carbon energy systems and country's energy security. Accurately and reliably forecasting gas price can be considered as a significant issue to both related investors and policymakers. This study adopts a decomposition-ensemble model to improve the accuracy of predicting gas price. The process is as follows: Firstly, the original energy price sequence is decomposed into subsequences with different frequencies through variational mode decomposition (VMD) with genetic algorithm. Secondly, Elman neural network (ELMAN) predicts the last high-frequency subsequence and bidirectional gated recurrent unit neural network model (BiGRU) forecasts other subsequences. Thirdly, the final forecast of the subsequences with various models is integrated with nonlinear integration approach. After the empirical study, three loss functions including root mean square error, mean absolute error, mean absolute percent error, the determination coefficient and the modification in Diebold-Mariano statistics (the MDM test) are adopted as the evaluation criteria. The empirical results prove that the proposed method outperforms other compared models under different test set lengths and different periods of business cycle. Overall, experiments on the natural gas prices demonstrate the validity and superiority in the established VMD-BiGRU-ELMAN through the nonlinear ensemble method. The proposed method can simultaneously develop different advantages of corresponding model providing a useful prediction method to governments and enterprises.

Abstract:Accurately predicting gas load is crucial for optimal planning and scheduling of natural gas production. Existing machine learning or deep learning-based prediction methods primarily aim to improve accuracy. However, these methods face challenges such as overlapped features, significant background noise, and residual errors. In response to these challenges, we proposed a fusion prediction model, known as the Double Temporal Convolutional Network (TCN) and Light Gradient Boosting Machine (LightGBM) with Three-way Residual Error Amendment (DT-LGBM-3WREA). To address the overlapped feature issue in time series data, we utilize the STL module for data decomposition. To handle background noise, the network incorporates a double TCN module specifically designed for trend and seasonal components. Thus, it can better avoid the transmission of noise between modules. To address residual error, we introduce three-way decision methodology and develop the 3WREA module, which aims to avoid local optima and random factors from perturbing the prediction accuracy. This approach mitigates the influence of remainder item on overall prediction performance. Experimental results demonstrate that the DT-LGBM-3WREA model excels in gas load prediction scenarios, surpassing state-of-the-art methods.

Abstract:Accurate power load forecasting is crucial for the sustainable operation of smart grids. However, the complexity and uncertainty of load, along with the large-scale and high-dimensional energy information, present challenges in handling intricate dynamic features and long-term dependencies. This paper proposes a computational approach to address these challenges in short-term power load forecasting and energy information management, with the goal of accurately predicting future load demand. The study introduces a hybrid method that combines multiple deep learning models, the Gated Recurrent Unit (GRU) is employed to capture long-term dependencies in time series data, while the Temporal Convolutional Network (TCN) efficiently learns patterns and features in load data. Additionally, the attention mechanism is incorporated to automatically focus on the input components most relevant to the load prediction task, further enhancing model performance. According to the experimental evaluation conducted on four public datasets, including GEFCom2014, the proposed algorithm outperforms the baseline models on various metrics such as prediction accuracy, efficiency, and stability. Notably, on the GEFCom2014 dataset, FLOP is reduced by over 48.8%, inference time is shortened by more than 46.7%, and MAPE is improved by 39%. The proposed method significantly enhances the reliability, stability, and cost-effectiveness of smart grids, which facilitates risk assessment optimization and operational planning under the context of information management for smart grid systems.

Abstract:Due to changes in urban residents' consumption habits and lifestyles, accurately predicting natural gas consumption has become increasingly important. To address this issue, this paper proposes a forecasting model that combines Ensemble Learning (EL), Variational Mode Decomposition (VMD), Transformer, and LSTM. First, XGBoost, CatBoost, and LightGBM are used as base learners in the ensemble learning framework, with the predictions generated by the ensemble model integrated into the original dataset. Next, the VMD method is employed to decompose the natural gas load sequence into several intrinsic mode functions (IMFs), effectively extracting the inherent features of the natural gas load sequence. Finally, the data is input into the Transformer-ResLSTM network for prediction. This network replaces the original Transformer decoder structure with an LSTM network and fully connected layers, creating a new decoder structure. Additionally, a residual connection mechanism is introduced in both the encoder of the Transformer network and the new decoder structure. Experimental results show that, compared to traditional models such as ARIMA, Transformer, GRU, and LSTM, the proposed hybrid model significantly improves prediction accuracy, reducing MSE by 92-98% and MAE by 74-83%. In summary, this method demonstrates significant potential and practical value in enhancing the accuracy of natural gas load forecasting.

Abstract:Accurate and reliable low-voltage load forecasting is critical to optimal operation and control of distribution network and smart grid. However, compared to traditional regional load forecasting at high-voltage level, it faces tough challenges due to the inherent high uncertainty of the low-capacity load and distributed renewable energy integrated in the demand side. This paper proposes a novel hybrid ensemble deep learning (HEDL) approach for deterministic and probabilistic low-voltage load forecasting. The deep belief network (DBN) is applied to low-voltage load point prediction with the strong ability of approximating nonlinear mapping. A series of ensemble learning methods including bagging and boosting variants are introduced to improve the regression ability of DBN. In addition, the differencing transformation technique is utilized to ensure the stationarity of load time series for the application bagging and boosting methods. On the basis of the integrated thought of ensemble learning, a new hybrid ensemble algorithm is developed via integrating multiple separate ensemble methods. Considering the diversity in various ensemble algorithms, an effective K nearest neighbor classification method is utilized to adaptively determine the weights of sub-models. Furthermore, HEDL based probabilistic forecasting is proposed by taking advantage of the inherent resample idea in bagging and boosting. The effectiveness of the HEDL method for both deterministic and probabilistic forecasting has been systematically verified based on realistic load data from East China and Australia, indicating its promising prospective for practical applications in distribution networks.

Abstract:Abstract The power grid load exhibits non-linearity and volatility, posing challenges to power grid dispatching. To enhance the precision of power grid load forecasting, a variable weight combination forecasting model is suggested to address the issue of inadequate forecasting efficacy of individual algorithms. Considering the impact of various environmental factors on power grid load, a load influence feature dataset is formulated. Initially, support vector machines, genetic algorithm-optimized back propagation (BP) neural networks and radial basis neural networks are employed to forecast individual loads. Subsequently, a variance–covariance weight dynamic distribution method is utilized to merge the prediction results of the three individual algorithms, thereby establishing a short-term power grid load prediction model with variable weight combination. Taking a regional power grid as an example, the simulation results show that the prediction accuracy of the variable weight combination model is higher than that of the single algorithm. Taking the evaluation index MAPE as an example, compared with the three single algorithms, the prediction accuracy is improved by 42.31%, 48.56% and 65.33%. The practice proves that the proposed variable weight combination forecasting model greatly improves the accuracy of power network load forecasting.

Abstract:Research has focused on whether information spillovers from external influences play a role in clean energy–natural gas volatility forecasts. However, the climate and energy crises caused by the intensification of extreme events, such as recent extreme weather and geopolitical risks, have led the public to turn their attention to research in the field of clean energy. Therefore, this paper uses one-class SVM (support vector machine) techniques to identify extreme volatility in natural gas prices induced by significant occurrences (e.g., wars, financial crises, and COVID-19) and then investigates whether considering extreme volatility in natural gas over different volatile periods (short- and long-term periods) improves volatility forecasting accuracy within the context of a GARCH-MIDAS framework. The in-sample analyses demonstrate that extreme shocks increase natural gas price volatility and that the asymmetric effects are more influential than the short- and long-term extreme volatility effects. The out-of-sample results indicate that the GJR-GARCH-MIDAS-one-class-SVM-SLES model outperforms the other models and achieves the best forecasting performance of the remaining extended models. In addition, robustness tests confirm these findings.

Abstract:Precisely predicting natural gas prices (NGPs) is important because it can provide the necessary decision-making basis for energy scheduling, planning and control. However, NGPs are affected by many factors and exhibit the characteristics of nonlinearity and randomness, which makes accurate predictions challenging. Therefore, in this paper, the information gain of multisource data and the global optimization ability of the gray wolf algorithm are used to build a multifactor-driven NGP hybrid forecasting model to improve the prediction performance. First, the emotional tendency and readability of news text are extracted and calculated by using VADER and textstat tools, respectively. Then the network search index is filtered and integrated by using the correlation coefficient method and the CRITIC method to form alternative variables of multisource data (news and search index). Second, the gray wolf optimization algorithm is used to find and determine the best key parameter group in long short-term memory model. Finally, the spot price of natural gas in Henry Hub from March 1, 2012 to February 28, 2022 is selected as the prediction object, and multi-scenario numerical experiments are carried out to verify the effectiveness of the proposed model. The ablation experiment results show that the information gain brought by multisource data can effectively improve the prediction effect of NGPs. Furthermore, the proposed model has the best prediction performance in different scenarios and can be regarded as a promising prediction tool.
Decoupling and predicting natural gas deviation factor using machine learning methods

Abstract:Accurately predicting the deviation factor (Z-factor) of natural gas is crucial for the estimation of natural gas reserves, evaluation of gas reservoir recovery, and assessment of natural gas transport in pipelines. Traditional machine learning algorithms, such as Support Vector Machine (SVM), Extreme Gradient Boosting (XGBoost), Light Gradient Boosting Machine (LightGBM), Artificial Neural Network (ANN) and Bidirectional Long Short-Term Memory Neural Networks (BiLSTM), often lack accuracy and robustness in various situations due to their inability to generalize across different gas components and temperature-pressure conditions. To address this limitation, we propose a novel and efficient machine learning framework for predicting natural gas Z-factor. Our approach first utilizes a signal decomposition algorithm like Variational Mode Decomposition (VMD), Empirical Fourier Decomposition (EFD) and Ensemble Empirical Mode Decomposition (EEMD) to decouple the Z-factor into multiple components. Subsequently, traditional machine learning algorithms is employed to predict each decomposed Z-factor component, where combination of SVM and VMD achieved the best performance. Decoupling the Z-factors firstly and then predicting the decoupled components can significantly improve prediction accuracy of all traditional machine learning algorithms. We thoroughly evaluate the impact of the decoupling method and the number of decomposed components on the model's performance. Compared to traditional machine learning models without decomposition, our framework achieves an average correlation coefficient exceeding 0.99 and an average mean absolute percentage error below 0.83% on 10 datasets with different natural gas components, high temperatures, and pressures. These results indicate that hybrid model effectively learns the patterns of Z-factor variations and can be applied to the prediction of natural gas Z-factors under various conditions. This study significantly advances methodologies for predicting natural gas properties, offering a unified and robust solution for precise estimations, thereby benefiting the natural gas industry in resource estimation and reservoir management.

Abstract:As low-carbon clean energy, natural gas plays an essential role in the energy transition, and the demand for natural gas is increasing rapidly. Natural gas load forecasting can not only understand the gas consumption characteristics of users, but also guide the formulation of natural gas pipeline network construction and dispatching plans. It is of great significance to improve the economic benefits of energy enterprises. The construction time of the natural gas pipeline network in Zhejiang Province is short, the amount of data for new users is small, and some external factors are difficult to obtain, which significantly affects the accuracy of load forecasting. To address the above issues, we conduct research on natural gas load forecasting, and design a time series forecasting model based on serial autocorrelation. Moreover, we have investigated the “leverage effect” in the financial field, and discussed the heteroscedasticity phenomenon. The principle and applicability of the SARIMA model and the EGARCH model are analyzed. The design ideas and modeling process of the fusion model are introduced. Finally, extensive experimental results show that the designed prediction model can achieve better performance.
Daily natural gas load prediction method based on APSO optimization and Attention-BiLSTM

Abstract:As the economy continues to develop and technology advances, there is an increasing societal need for an environmentally friendly ecosystem. Consequently, natural gas, known for its minimal greenhouse gas emissions, has been widely adopted as a clean energy alternative. The accurate prediction of short-term natural gas demand poses a significant challenge within this context, as precise forecasts have important implications for gas dispatch and pipeline safety. The incorporation of intelligent algorithms into prediction methodologies has resulted in notable progress in recent times. Nevertheless, certain limitations persist. However, there exist certain limitations, including the tendency to easily fall into local optimization and inadequate search capability. To address the challenge of accurately predicting daily natural gas loads, we propose a novel methodology that integrates the adaptive particle swarm optimization algorithm, attention mechanism, and bidirectional long short-term memory (BiLSTM) neural networks. The initial step involves utilizing the BiLSTM network to conduct bidirectional data learning. Following this, the attention mechanism is employed to calculate the weights of the hidden layer in the BiLSTM, with a specific focus on weight distribution. Lastly, the adaptive particle swarm optimization algorithm is utilized to comprehensively optimize and design the network structure, initial learning rate, and learning rounds of the BiLSTM network model, thereby enhancing the accuracy of the model. The findings revealed that the combined model achieved a mean absolute percentage error (MAPE) of 0.90% and a coefficient of determination (R 2 ) of 0.99. These results surpassed those of the other comparative models, demonstrating superior prediction accuracy, as well as exhibiting favorable generalization and prediction stability.

Abstract:With the continuous growth of the global natural gas trade, the accurate prediction of natural gas prices has become one of the most critical issues in the planning and operation of public utilities. In order to further improve the prediction accuracy of natural gas prices, we have developed a novel hybrid method based on the CEEMDAN-SE (complete ensemble empirical mode decomposition with an adaptive noise-sample entropy) and the PSO-ALS-GRU (gated recurrent unit network optimized by the particle swarm optimization algorithm with an adaptive learning strategy (PSO-ALS)) for predicting the natural gas prices. The proposed approach can address the limitations of the traditional forecasting approaches and perform accurate predictions. First, the original natural gas price series is decomposed into a series of sub-sequences with obvious differences in a complex degree by using the CEEMDAN-SE. Then, the forecasting model PSO-ALS-GRU is developed, and each sub-sequence is individually predicted. Finally, the prediction results of each sub-sequence are superimposed and reconstructed in order to form the overall forecast result. This hybrid model combines the methodology of complex systems with deep-learning techniques, making it more appropriate for analyzing relationships such as long-term dependences and solving complex nonlinear problems. By finding the key hyperparameters in the GRU network using the PSO-ALS, the data feature of natural gas prices matches the network topology structure, and the prediction accuracy of the model is improved. For illustration and verification purposes, the simulation is performed by using real data. The results show that the novel hybrid model can accurately predict the weekly prices of natural gas. In a comparison of prediction errors with other individual models, the proposed model demonstrates the highest prediction ability among all of the investigated models.

Abstract:A deep-learning-based hybrid strategy for short-term load forecasting is presented. The strategy proposes a novel tree-based ensemble method warm-start gradient tree boosting (WGTB). Current strategies either ensemble submodels of a single type, which fail to take advantage of the statistical strengths of different inference models, or simply sum the outputs from completely different inference models, which does not maximize the potential of the ensemble. Inspired by the bias-variance trade-off, WGTB is proposed and tailored to the great disparity among different inference models on accuracy, volatility, and linearity. The complete strategy integrates four different inference models of different capacities. WGTB, then, ensembles their outputs by a warm-start and a hybrid of bagging and boosting, which lowers bias and variance concurrently. It is validated on two real datasets from the State Grid Corporation of China of hourly resolution. The result demonstrates the effectiveness of the proposed strategy that hybridizes the statistical strengths of both low-bias and low-variance inference models.

Abstract:Abstract The present article proposes an enhanced hybrid neural network model that combines variational mode decomposition (VMD) and genetic algorithm-backpropagation (GA-BP) to tackle the accurate prediction task of nonstationary and nonlinear power demand data. In comparison to existing methods, this study employs the North Gallic Hawk Optimization (NGO) algorithm to preliminarily ensure the optimization of the number of VMD modes, K and the penalty factor, α. Furthermore, it utilizes the envelope entropy criterion to determine the minimum optimal VMD components for predicting low-order spectral features vectors. Building upon this, the GA-BP optimization method establishes prediction models for the NGO-VMD model’s individual components. When compared with traditional methods, the GA-BP model exhibits significant advantages in terms of rapid convergence, fewer iterations and high prediction accuracy. Empirical results demonstrate that this approach holds promising prospects for practical application in power demand prediction. In comparison to traditional model predictive performance, the root mean square error is reduced by 60.36% and the mean absolute percentage error by 44.34%, providing robust support to enhance prediction accuracy and promote sustainable development of power systems.

Abstract:With the role of natural gas gaining increasing importance in the transition of the world energy system and addressing global climate change, accurate prediction of the price of natural gas becomes crucially important. This paper first introduces three widely used individual data-driven models, i.e., support vector regression (SVR) and long-term and short-term memory network (LSTM), and a modified data-driven model, i.e., the improved pattern sequence similarity search (IPSS). A new weighted hybrid data-driven model based on these three models is then proposed. To train the model, data regarding the daily natural gas spot price in the U.S. prior to June 2018 are used and the model's prediction ability is tested using data from June 2018 to May 2019. The results show that the new IPSS model can predict the daily price of natural gas accurately. In a comparison of prediction errors with other individual models, the proposed hybrid model demonstrated the highest prediction ability of all of the investigated models.

Abstract:Machine learning algorithms provide feasibility for crude oil price prediction. In this paper, a novel multi-hybrid predictive neural network model is proposed based on complex deep learning algorithm, which integrates empirical wavelet transform, random inheritance formula error correction algorithm, deep bidirectional LSTM neural network and Elman recurrent neural network with variational learning rate. The prediction model is selected according to the sequence frequency after EWT feature extraction, and the prediction results are obtained by separately predicting and reintegrating. On the basis of individual model, the structure of deep bidirectional training, random inheritance formula and variational learning rate are proposed, which further ameliorate the performance of the model and achieve more effective data information capture. Simultaneously, the examination of variational learning rate provides us with a feasible parameter selection. The proposed model achieves high-precision prediction of crude oil futures price, and stands out in the multi-model comparison analysis and q-DSCID synchronous evaluation, with superior prediction accuracy.

Abstract:Natural gas has been proposed as a solution to increase the security of energy supply and reduce environmental pollution around the world. Being able to forecast natural gas price benefits various stakeholders and has become a very valuable tool for all market participants in competitive natural gas markets. Machine learning algorithms have gradually become popular tools for natural gas price forecasting. In this paper, we investigate data-driven predictive models for natural gas price forecasting based on common machine learning tools, i.e., artificial neural networks (ANN), support vector machines (SVM), gradient boosting machines (GBM), and Gaussian process regression (GPR). We harness the method of cross-validation for model training and monthly Henry Hub natural gas spot price data from January 2001 to October 2018 for evaluation. Results show that these four machine learning methods have different performance in predicting natural gas prices. However, overall ANN reveals better prediction performance compared with SVM, GBM, and GPR.

Abstract:As a clean fossil energy source, natural gas plays a crucial role in the global energy transition. Forecasting natural gas prices is an important area of research. This paper aims at developing a novel hybrid model that contributes to the prediction of natural gas prices. We develop a novel hybrid model that combines the “Decomposition Algorithm” (CEEMDAN), “Ensemble Algorithm” (Bagging), “Optimization Algorithm” (HHO), and “Forecasting model” (SVR). The hybrid model is used for monthly Henry Hub natural gas forecasting. To avoid the problem of data leakage caused by decomposing the whole time series, we propose a rolling decomposition algorithm. In addition, we analyzed the factors affecting Henry Hub natural gas prices for multivariate forecasting. Experimental results indicate that the proposed model is more effective than the traditional model at predicting natural gas prices.
