Abstract:Modern cyber–physical production systems provide advanced solutions to enhance factory throughput and efficiency. However, monitoring its behaviour and performance becomes challenging as the complexity of a manufacturing system increases. Artificial Intelligence (AI) provides techniques to manage not only decision-making tasks but also to support monitoring. The integration of AI into a factory can be facilitated by a reliable Digital Twin (DT) that enables knowledge-based and data-driven approaches. While computer vision and convolutional neural networks (CNNs) are crucial for monitoring production systems, the need for extensive training data hinders their adoption in real factories. The proposed methodology leverages the Digital Twin of a factory to generate labelled synthetic data for training CNN-based object detection models. Regarding their position and state, the focus is on monitoring entities in manufacturing systems, such as parts, components, fixtures, and tools. This approach reduces the need for large training datasets and enables training when the actual system is unavailable. The trained CNN model is evaluated in various scenarios, with a real case study involving an industrial pilot plant for repairing and recycling Printed Circuit Boards (PCBs).

Abstract:Smart monitoring plays a principal role in the intelligent automation of manufacturing systems. Advanced data collection technologies, like sensors, have been widely used to facilitate real-time data collection. Computationally efficient analysis of the operating systems, however, remains relatively underdeveloped and requires more attention. Inspired by the capabilities of signal analysis and information visualization, this study proposes a multi-method framework for the smart monitoring of manufacturing systems and intelligent decision-making. The proposed framework uses the machine signals collected by noninvasive sensors for processing. For this purpose, the signals are filtered and classified to facilitate the realization of the operational status and performance measures to advise the appropriate course of managerial actions considering the detected anomalies. Numerical experiments based on real data are used to show the practicability of the developed monitoring framework. Results are supportive of the accuracy of the method. Applications of the developed approach are worthwhile research topics to research in other manufacturing environments.

Abstract:The digitization of production systems has revolutionized industrial monitoring. Analyzing real-time bottom-up data enables the dynamic monitoring of industrial processes. Data are collected in various types, like video frames and time signals. This article focuses on leveraging images from a vision system to monitor the manufacturing process on a computer numerical control (CNC) lathe machine. We propose a method for designing and integrating these video modules on the edge of a production line. This approach detects the presence of raw parts, measures process parameters, assesses tool status, and checks roughness in real time using image processing techniques. The efficiency is evaluated by checking the deployment, the accuracy, the responsiveness, and the limitations. Finally, a perspective is offered to use the metadata off the edge in a more complex artificial-intelligence (AI) method for predictive maintenance.

Abstract:Increasing market demand towards higher product and process quality and efficiency forces companies to think of new and innovative ways to optimize their production. In the area of high-tech manufacturing products, even slight variations of the product state during production can lead to costly and time-consuming rework or even scrapage. Describing an individual product’s state along the entire manufacturing programme, including all relevant information involved for utilization, e.g., in-process adjustments of process parameters, can be one way to meet the quality requirements and stay competitive. Ideally, the gathered information can be directly analyzed and in case of an identified critical trend or event, adequate action, such as an alarm, can be triggered. Traditional methods based on modelling of cause-effect relations reaches its limits due to the fast increasing complexity and high-dimensionality of modern manufacturing programmes. There is a need for new approaches that are able to cope with this complexity and high-dimensionality which, at the same time, are able to generate applicable results with reasonable effort. Within this paper, the possibility to generate such a system by applying a combination of Cluster Analysis and Supervised Machine Learning on product state data along the manufacturing programme will be presented. After elaborating on the different key aspects of the approach, the applicability on the identified problem in industrial environment will be discussed briefly.

Abstract:In this paper, a dynamic Bayesian network based systematic monitoring framework is proposed for plant-wide processes, which provides a systematical modeling scheme in both basic and global layer. First, the large-scale plant-wide process is decomposed into several local units according to prior process knowledge, providing local statistical information as the monitoring resources of the global layer. The network structures of local units are learned automatically from the process data, while the global structure is determined by prior process topology. The dynamic Bayesian network approach is employed for process modeling, considering the dynamic characteristic of the process, making the statistical indices into probabilistic form, which can describe the process uncertainty quantitatively and draw the causal relationships qualitatively. Furthermore, a systematic top-down monitoring framework is developed and applied to Tennessee Eastman benchmark process, evaluated to be efficient with process fault detection and diagnoses including identification of faulty unit and root-cause variables, and isolation of fault propagation through time-slices.

Abstract:Transactions of the Institute of Measurement and Control, Ahead of Print. Process monitoring technology can help make the right decisions in manufacturing, but the complexity and scale of modern process industry processes render process monitoring difficult. Existing data-driven process monitoring methods utilize abundant monitoring data that are accumulated in industrial processes, but nonlinearity, high coupling, noise effects, and other problems continuously appear in process industry monitoring data. This study proposes a process monitoring method based on variational autoencoder and long short-term memory techniques. The method reconstructs the monitoring data by learning their distribution and time series characteristics under the controlled state, and then it monitors the state of the manufacturing process in real time by calculating the statistics. Evaluation is conducted using the Tennessee Eastman process case verification and experimental comparison method. Then, the proposed method is compared with the centralized process via principal component analysis and kernel principal component analysis. The results show that the proposed method can more significantly improve the effect of fault detection in distributed system process monitoring compared with the traditional method, and it has a better process monitoring effect.

Abstract:Process complexities are characterized by strong nonlinearities, dynamics, and uncertainties. Monitoring such a complex process requires a high-quality model describing the corresponding nonlinear dynamic behavior. The proposed model is constructed using deep neural networks (DNNs) to represent the state transition and observation generation, both of which constitute a stochastic nonlinear state-space model. A new bidirectional recurrent neural network (RNN), creating a connection of the hidden layer between a forward RNN and a backward RNN, is proposed to generate the filtering estimation and the smoothing estimation of process states which further generate observations with DNN-based process models. The smoothing estimator and the process model are first learned offline with all collected samples. Then the filtering estimator is fine-tuned by the learned smoother and process models to achieve real-time monitoring since the filter state is estimated based on the past and the current observations. Two indices are designed based on the learned model for monitoring the process anomaly. The proposed process monitoring model can deal with complex nonlinearities, process dynamics, and process uncertainties, all of which can be very challenging for the existing methods, such as kernel mapping and stacked auto-encoder. Two case studies validate that the effectiveness of the proposed method outperforms the other comparative methods by at least 10% when using the averaged fault detection rate in the industrial experimental data.

Abstract:Data-driven process monitoring based on latent variable models are widely employed in industry. This article proposes a novel monitoring framework for latent variable models using hierarchical feature extraction, Bayesian inference, and weighting strategy. We first establish a deep structure to implement hierarchical latent variables extraction, the extracted features are used to construct diverse monitoring statistics. Then, we utilize Bayesian inference and proper weighting strategy to fuse various useful information. In line with the different characteristics of principal component analysis (PCA) and independent component analysis (ICA), we construct a deep PCA-ICA model for process monitoring according to the proposed framework. The deep PCA-ICA model performs hierarchical feature extraction, which can simultaneously extract deep Gaussian information and deep non-Gaussian information. The features extracted by different layers are then transformed to posterior probabilities through Bayesian inference. After that, different posterior probabilities are combined through appropriate weighting strategy to build new probabilistic statistic, which can give more synthetic monitoring results. Moreover, the Bayesian inference and weighting strategy are further used to integrate the advantages of different models by transforming various probabilistic statistics into an overall monitoring index, which can comprehensively indicate the process status. The Tennessee Eastman process is used to validate the superiority of the proposed model over the existing methods. Besides, the extracted features are further analyzed to show the effectiveness and benefits of the deep hierarchical feature extraction structure.

Abstract:With the growing complexity of the modern industrial process, monitoring large-scale plant-wide processes has become quite popular. Unlike traditional processes, the measured data in the plant-wide process pose great challenges to information capture, data management, and storage. More importantly, it is difficult to efficiently interpret the information hidden within those data. In this paper, the road map of a distributedmodeling framework for plant-wide process monitoring is introduced. Based on this framework, the whole plant-wide process is decomposed into different blocks, and statistical data models are constructed in those blocks. For online monitoring, the results obtained from different blocks are integrated through the decision fusion algorithm. A detailed case study is carried out for performance evaluation of the plant-wide monitoring method. Research challenges and perspectives are discussed and highlighted for future work.

Abstract:Recently, considerable effort has been devoted to applying new techniques such as Artificial Intelligence (AI) and machine learning in manufacturing systems. Implementing effi-cient fault detection and diagnosis procedure for manufacturing systems can provide manufacturers with significant advantages, e.g., enhancing product quality and yield while reducing cost. Maximizing efficiency and controlling costs is the goal of every operation. Optimization methods like Evolutionary Algorithms can be considered for modeling manufacturing operational procedures using datasets whose contents are populated by various sensors and other data sources. Embracing AI to empower organizations to analyze data can lead to efficient and intelligent automation. In this paper, we propose a hybrid model for monitoring manufacturing operations based on a multi-objective approach. This model considers different conflicting objectives that should be minimized simultaneously. Our goal is to provide an advanced methodology for exploring manufacturing processes and to gain perspective on production status. It enables manufacturers to access the effectiveness of predictive technologies and respond well to any disruptive trends.

Abstract:Intelligent manufacturing process needs to adopt distributed monitoring scenario due to its massive, high-dimensional and complex data. Distributed process monitoring has been introduced into global monitoring and local monitoring to analyze the characteristic relationship between process data. However, the existing framework methods ignore or suppress the fault information and thus cannot effectively identify the local faults and the time sequence characteristics between units in the batch production system. This paper proposes a novel distributed process monitoring framework based on Girvan-Newman algorithm modular subunit partitioning and probabilistic learning model with deep neural networks. First, Girvan-Newman algorithm is used to divide the complex manufacturing system modularized to reduce the latitude of data processing. Second, variational autoencoder (VAE) is adopted to ensure the stability of local analysis, and long short-term memory is adopted to improve the VAE model to detect global multi-time scale anomalies. Finally, distributed process fault detection is carried out for each subunit in a separate and integrated manner, and the performance of the framework in distributed process monitoring is analyzed through two fault detection indicators T2 and SPE statistics. A case study of the Tennessee Eastman Process is used to demonstrate the performance and applicability of the proposed framework. Results show that the proposed VAE enhancement framework based on the DNN could accurately identify faults in distributed process monitoring and locate the specific sub-units where the fault occurs. Compared with VAE-DNN method and traditional process monitoring methods, the framework proposed in this paper has higher fault detection rate and lower false alarm rate, and the detection rate of some faults can reach 100%.

Abstract:Product quality is a key factor for manufacturing companies to evaluate their production capability and increase their market competitiveness. Today's Manufacturing processes have become more complicated and usually equipped with smart sensors that collect a massive amount of data along the manufacturing chain. This chain consists of a multistage of manufacturing processes to produce complex products to satisfy customer requirements. In multistage manufacturing systems, many factors may have interactive and cumulative effects on the final product quality. The purpose of this research is to introduce an intelligent real-time quality monitoring framework capable of predicting and identifying the quality deviations for multistage manufacturing systems as early as possible to reduce wastes of time and resources. We used different unsupervised and supervised machine learning techniques such as principal component analysis, support vector machine, neural network and random forest to consider the accumulative effect of different workstations and to construct the quality monitoring model. We used a complex semiconductor manufacturing dataset to evaluate the performance of the proposed framework. The results show the capability of the proposed framework to improve the performance of the quality monitoring process in the multistage manufacturing systems and to reduce both type Ӏ and type ӀӀ errors.

Abstract:Abstract At present, the automation production line has problems such as insufficient intelligence level. The intelligent monitoring, control and improvement of product quality and efficiency are the key common technologies faced by advanced manufacturing industry. Self-learning time varying digital twin (DT) system for intelligent monitoring is proposed in the paper. In the process of automatic production line processing and workpiece detection, an DT consisting of physical production line layer, edge monitoring layer and cloud evolution layer is built. The DT system realizes self-learning time-varying through active excitation of processing parameter optimization. The workpiece quality is a real-time representation of the tool condition, and the tool wear sensitive features extracted by the deep learning algorithm. Through the two-way drive of time-varying physical and virtual data, the tool wear characterization model can be evaluated, self-learning, updated and verified timely in the light of the actual condition to achieve tool condition monitoring and processing parameter optimization. The prediction model is self-iterative and simplified in the cloud, and the edge side is quickly matched and adaptive. Self-learning time-varying DT system based on self-driving of manufacturing process can adaptively improve the ability of intelligent monitoring.

Abstract:The development of the Internet of Things, cloud computing, and artificial intelligence has given birth to industrial artificial intelligence (IAI) technology, which enables us to obtain fine perception and in-depth understanding capabilities for the operating conditions of industrial processes, and promotes the intelligent transformation of modern industrial production processes. At the same time, modern industry is facing diversified market demand instead of ultra-large-scale demand, resulting in typical variable conditions, which enhances the nonstationary characteristics of modern industry, and brings great challenges to the monitoring of industrial processes. In this regard, this paper analyzes the complex characteristics of nonstationary industrial operation, reveals the effects on operating condition monitoring, and summarizes the difficulties faced by varying condition monitoring. Furthermore, by reviewing the recent 30 years of development of data-driven methods for industrial process monitoring, we sorted out the evolution of nonstationary monitoring methods, and analyzed the features, advantages and disadvantages of the methods at different stages. In addition, by summarizing the existing related research methods by category, we hope to provide reference for monitoring methods of nonstationary process. Finally, combined with the development trend of industrial artificial intelligence technologies, some promising research directions are given in the field of nonstationary process monitoring.

Abstract:Explains that the rapid growth of artificial intelligence techniques, especially neural networks and knowledge‐based systems, have paved the way for the development of an intelligent and real‐time manufacturing information system. By efficiently utilizing the specific domain representation in a production cell, an intelligent system can manage the complex issues concerning the structure and character of the product, goals of the manufacturing unit and provide production guidance accordingly. Addresses issues in manufacturing intelligence through two case studies that demonstrate the feasibility of a real‐time quality control in changing environmental conditions. The quality and the factor of acceptability are determined by the intelligent agent. These intelligent agents involve the use of an artificial neural network system and, in some cases, a knowledge‐based system to control and operate, in real‐time, the functions of an inspection process in manufacturing. Addresses the design issues of interest, especially setting up global routines which can be used in a common platform to control a machine tool, interpret the sensor inputs, monitor the quality of products, and take corrective actions on a real‐time basis.
An Approach for the Evaluation of a Measurement System: A Study on the Use of Machine Learning and Predictions

Abstract:Quality control during the manufacturing process is an important factor in delivering products in electronics according to planned characteristics and properties. It concerns the capability of the chosen measurement system to perform precise and reliable measurement trials, which is evaluated mainly through the utilization of measurement system analysis. In order to reduce time effort and to partially automate these operations, a methodology for the prediction of a part of the dataset through applying the Neural Net algorithm is proposed in this paper in two scenarios: (1) when two metrology experts are involved in the measurement in three trials and the data of a third specialist are predicted and (2) when three metrology specialists collect data in two trials and the data of the third trial are predicted. The developed predictive models in these two scenarios are assessed and they are characterized by high accuracy. Gage repeatability and reproducibility analysis are used to evaluate the measurement systems based on original and partially artificial datasets as the comparative results outline the suitability of the proposed approach, due to the proximity of the obtained values.

Abstract:Intelligent Monitoring Systems (IMS) have emerged as indispensable tools in modern manufacturing, offering real-time insights into production processes, equipment performance, and quality control. This review provides an overview of the current state and future prospects of IMS in manufacturing environments. The current state of IMS in manufacturing involves the integration of advanced technologies such as Internet of Things (IoT), Artificial Intelligence (AI), Machine Learning (ML), and Big Data analytics. These systems collect vast amounts of data from sensors, machines, and production lines, enabling real-time monitoring and analysis of various parameters. By employing AI and ML algorithms, IMS can identify patterns, predict anomalies, and optimize production processes, leading to increased efficiency, reduced downtime, and improved product quality. IMS play a crucial role in predictive maintenance, where they can anticipate equipment failures before they occur, thereby minimizing unplanned downtime and maintenance costs. Moreover, IMS facilitate condition-based monitoring, allowing manufacturers to monitor the health and performance of machinery in real-time and schedule maintenance activities accordingly, optimizing resource allocation and prolonging equipment lifespan. Furthermore, IMS contribute to quality control by continuously monitoring production processes and detecting deviations from desired specifications. By leveraging AI-driven algorithms, IMS can automatically adjust process parameters to maintain product quality standards and minimize defects, thereby enhancing overall product reliability and customer satisfaction. A machine learning approach to quality monitoring of injection molding process using regression models

Abstract:ABSTRACT Recent advancements in instrumentation and the emergence of industrial IoT solutions have created new possibilities to collect data in injection molding processes. Although many approaches have been introduced to develop quality monitoring systems based on this wealth of data, most of them require human expertise for data evaluation or feature extraction, thus their performance is highly dependent on the quality of the incorporated features. In this work, a data-driven approach to the development of a quality monitoring system is proposed using a wide range of process data obtained from a variety of in-mold sensors and machine data sources. Initially, ten different machine learning algorithms are explored. Among them, the multiple linear regression models show the best performance due to their low training error. Several training strategies are implemented based on allocating different subsets of the available data sources. A set of experiments perturbated by three common process disturbances is used to validate the accuracy of the trained models in predicting the quality indices. The results demonstrate that the average error in predicting the weight, diameter, and thickness of the injected parts does not exceed 0.5%, 0.1%, and 0.4% respectively, which imply the effectiveness of the proposed data processing method.

Cutting model integrated digital twin–based process monitoring in small-batch machining

Abstract:The success of machining process automation hinges primarily on the effectiveness of the monitoring and adaptive control systems. A new digital twin–based process monitoring method and system in small batch machining is presented, and the cutting model is integrated into the monitoring method to improve the diagnosis accuracy. Model-based and signal-based monitoring indicators are developed, and indicators of the residual force component for the tool wear monitoring and energy ratio for the chatter detection are introduced to the digital twin–based monitoring. The critical monitoring algorithm is verified in two cases: tool wear monitoring and chatter detection. The results show that the method proposed can accurately evaluate the percentages of the residual useful life of the tool and the chatter. Moreover, a new process monitoring system in small batch machining is developed by integrating the advanced algorithm. This study can provide a critical reference for intelligent machining monitoring and control in industry.
