Abstract:Component inspection is the first step for the health assessment of railway viaduct. In current practical engineering, information from multiple sources is always taken into consideration simultaneously before assessments are implemented. Visual inspection of railway infrastructures by resorting to task-specific deep learning solutions has been investigated and leveraged actively in both research and practical engineering communities. However, in the context of railway infrastructure inspection, only few efforts were reported upon multi-task deep learning. In the present study, a multi-task deep learning method for component inspection of railway viaducts was proposed based on the state-of-the-art multi-scale deep neural network. Two tasks were referred for the component inspection: component segmentation and depth estimation. The multi-task neural network architecture was implemented by three modules that make full use of commonalities and correlations among tasks at different scales. Intersection over Union was reported to be more than 88% for component segmentation and root mean square error to be less than 1.6 m for depth estimation, with significant improvements. The multi-task model reported better performance with respect to both evaluation metrics and inference speed, presenting the effectiveness of the proposed method compared with conventional single-task deep neural networks.

Abstract:Existing lightweight artificial intelligence models for interpreting tunnel lining Ground Penetrating Radar (GPR) data often suffer from inadequate accuracy and robustness owing to noise interference caused by in-tunnel infrastructure. This study introduces an optimised method, named MTGPR, for the automatic detection of voids and cavities in tunnel linings based on GPR radargrams. The proposed model offers strengthened feature extraction and fusion owing to the use of CAPW-YOLO, a hybrid model aimed at enhancing accuracy in the presence of infrastructure interference. To address the shortage of high-quality training samples, an augmented dataset was generated by refining synthetic radargrams. Ablation experiments showcased that the proposed scheme attained an accuracy of 88.5% and a precision of 84.0%. In comparison to the baseline model, the proposed method exhibited a 46.9% increase in recognition speed and a 10.2% reduction in weight parameter quantity. Consequently, the proposed method advances identification accuracy whilst preserving lightweight and high-speed.

Abstract:Automatic detection and segmentation of concrete cracks in tunnels remains a high-priority task for civil engineers. Image-based crack segmentation is an effective method for crack detection in tunnels. With the development of deep learning techniques, especially the development of image segmentation based on convolutional neural networks, new opportunities have been brought to crack detection. In this study, an improved deep fully convolutional neural network, named as CrackSegNet, is proposed to conduct dense pixel-wise crack segmentation. The proposed network consists of a backbone network, dilated convolution, spatial pyramid pooling, and skip connection modules. These modules can be used for efficient multiscale feature extraction, aggregation, and resolution reconstruction which greatly enhance the overall crack segmentation ability of the network. Compared to the conventional image processing and other deep learning-based crack segmentation methods, the proposed network shows significantly higher accuracy and generalization, making tunnel inspection and monitoring highly efficient, low cost, and eventually automatable.
A real-time multi-defect automatic identification framework for concrete dams via improved YOLOv5 and knowledge distillation

Abstract:Accurately identifying and differentiating multiple structural defects of concrete dams is of great significance for grasping the damage level of dams after long-term service. The conventional manual inspection technology suffers from problems such as high risk, labor cost, and time consumption, especially for large-scale and high dam structures. To address these problems, this study proposes a real-time multi-defect automatic identification and quantification method via machine vision (MV) and artificial intelligence (AI) for concrete dams. First, a high-performance dam multi-defects autonomous identification detector is developed via the lightweight You Only Look At Once V5 (YOLOv5) and adaptively spatial feature fusion (ASFF). Then, the combination of model regularization sparsity and pruning is utilized to change the weight distribution of the batch normalization (BN) and remove the redundant parameters in the network. Then, transfer learning technology combined with knowledge distillation is utilized to recover model accuracy and generalization performance degradation caused by parameter pruning. A concrete high arch dam in services is utilized as the case study, and seven types of structural defects are used as research items. Experimental results show the proposed framework can effectively deal with complicated dam inspection scenes, such as dam section joints, water masks, micro-crack, and concrete spalling damage. In addition, the proposed method can accurately distinguish different types of structural defects in concrete dams under the interference of environmental noises.

Abstract:Existing tunnel defect detection methods often lack repeated inspections, limiting longitudinal analysis of defects. To address this, we propose a multi-information fusion approach for continuous defect monitoring. Initially, we utilized the You Only Look Once version 7 (Yolov7) network to identify defects in tunnel lining videos. Subsequently, defect localization is achieved with Super Visual Odometer (SuperVO) algorithm. Lastly, the SuperPoint–SuperGlue Matching Network (SpSg Network) is employed to analyze similarities among defect images. Combining the above information, the repeatability detection of the disease is realized. SuperVO was tested in tunnels of 159 m and 260 m, showcasing enhanced localization accuracy compared to traditional visual odometry methods, with errors measuring below 0.3 m on average and 0.8 m at maximum. The SpSg Network surpassed the depth-feature-based Siamese Network in image matching, achieving a precision of 96.61%, recall of 93.44%, and F1 score of 95%. These findings validate the effectiveness of this approach in the repetitive detection and monitoring of tunnel defects.

Abstract:Most of the current tunnel defect detection methods do not perform repeated inspection of the defects taken at different times at the same location, which is a major deficiency for detecting the development trend of the defects. To solve the problem of repeated inspection of tunnel lining defects, this paper proposes a new method based on the combination of enhanced visual odometer and a Sequence-Siamese network(Seq-Siamese-Net) to identify and locate tunnel lining defects. We first detect the defects in the tunnel lining surface video by You Only Look Once network, then estimate the general location of the defects by using the proposed enhanced visual odometer, and finally obtain the most matching defects in the vicinity of the defects by Seq-Siamese-Net to achieve the repeated inspection of the tunnel lining surface defects. Experiments show that our proposed enhanced visual odometer method outperforms the original visual odometer method in terms of localization accuracy , while the feature extracted form Seq-Siamese-Network is more effective than the average-pooled feature in the tunnel defect image sequence matching task. Furthermore, experiments in a real tunnel demonstrate the practical value of the proposed method.

Abstract:Various structural defects deteriorate tunnel operation status and threaten public safety. Current tunnel inspection methods face problems of low efficiency, high equipment expense, and difficult data management. Combining the deep learning model and the 3D reconstruction method based on structure from motion (SfM), this paper proposes a novel SfM-Deep learning method for tunnel inspection. The high-quality 3D tunnel model is constructed by using images taken every 1 m along the longitudinal direction. The instance segmentation of leakage in longitudinal images is realized using the mask region-based convolutional neural network deep learning model. The SfM-Deep learning method projects the texture of the images after defect recognition to the 3D model and realizes the visualization of leakage defects. By projecting the model to the design cylindrical surface and expanding it, the tunnel leakage area is quantified. Through its practical application in a Shanghai metro shield tunnel, the reliability of the proposed method was verified. The novel SfM-Deep learning method can help engineers efficiently carry out intelligent tunnel detection.

Abstract:Due to the impact of the surrounding environment changes, train-induced vibration, and human interference, damage to metro tunnel surfaces frequently occurs. Therefore, accidents caused by the tunnel surface damage may happen at any time, since the lack of adequate and efficient maintenance. To our knowledge, effective maintenance heavily depends on the all-round and accurate defect inspection, which is a challenging task, due to the harsh environment (e.g., insufficient illumination, the limited time window for inspection, etc.). To address these problems, we design an automatic Metro Tunnel Surface Inspection System (MTSIS) for the efficient and accurate defect detection, which covers the design of hardware and software parts. For the hardware component, we devise a data collection system to capture tunnel surface images with high resolution at high speed. For the software part, we present a tunnel surface image pre-processing approach and a defect detection method to recognize defects with high accuracy. The image pre-processing approach includes image contrast enhancement and image stitching in a coarse-to-fine manner, which are employed to improve the quality of raw images and to avoid repeating detection for overlapped regions of the captured tunnel images respectively. To achieve automatic tunnel surface defect detection with high precision, we propose a multi-layer feature fusion network, based on the Faster Region-based Convolutional Neural Network (Faster RCNN). Our image pre-processing and the defect detection methods also promising performance in terms of recall and precision, which is demonstrated through a series of practical experimental results. Moreover, our MTSIS has been successfully applied on several metro lines.

Abstract:The detection of tunnel surface defects is the very important part to ensure tunnel safety. Traditional tunnel detection mainly relies on naked-eye inspection, which is time-consuming and error-prone. In the past few years, many defect detection methods based on computer vision have been introduced. However, these methods with manual feature extraction do not perform well in detecting tunnel defects due to the complicated background of tunnel surfaces. To address these problems, this paper propose a novel tunnel defect inspection method based on the Mask R-CNN. To improve the accuracy of the network , we endow it with a path augmentation feature pyramid network (PAFPN) and an edge detection branch. These improvements are easy to implement, with subtle extra memory and computational overhead. In this paper, we perform a detailed study of the PAFPN and the edge detection branch, and the experiment results show their robustness and accuracy in tunnel defect detection and segmentation.

Abstract:Due to the influence of construction quality, engineering geology and hydrological environment, defects such as dehollowing and insufficient compaction can occur in tunnels. Aiming at the problems of complex detection model, poor real-time performance and low accuracy of the current tunnel lining defect detection methods, the study proposes a lightweight defect detection algorithm of tunnel lining based on knowledge distillation. Firstly, a high-precision teacher model based on yolov5s was constructed by constructing a C3CSFM module that combines residual structure and attention mechanism, a MDFPN network structure with multi-scale feature fusion and a reweighted RWNMS re-screening mechanism. Secondly, in the distillation process, the feature and output dimension results are fused to improve the detection accuracy, and the mask feature relationship is learned in the space and channel dimension to improve the real-time detection. Tests on the tunnel lining radar defect image dataset showed that the number of parameters of the improved model was reduced from 16.03 MB to 3.20 MB, a reduction of 80%, and the average accuracy was improved from 83.4 to 86.5%, an increase of 3.1%. On the basis of maintaining the structure and detection performance of the model, the lightweight degree of the model is greatly improved, and the high-precision and real-time detection of tunnel lining defects is realized.

Abstract:The overall assessment of tunnel lining, including shapes, categories, and depths of tunnel internal defects as well as the thickness of tunnel linings is vital to the safe operation of tunnels. We proposed a method comprising a multi-task deep neural network and curve fitting post-processing operation for simultaneously identifying the shapes, categories, and depths of tunnel defects as well as lining thicknesses from ground penetrating radar (GPR) images. The multi-task deep neural network, denoted as M-YOLACT, was designed to identify defects, lining profiles, and hyperbola shapes simultaneously. We introduced a curve-fitting post-processing operation to calculate the dielectric constant automatically based on the hyperbola shapes and evaluated the defect depths and lining thicknesses. The method was validated by numerical simulations, sandbox, and field tests. The method effectively identified the shapes and classes of tunnel defects as well as the thickness profiles from GPR B-Scan images.

Abstract:Under the dual effects of the rapid growth of tunnel mileage and operating years, the application and research of tunnel crack identification based on machine vision are increasing with the vigorous development of machine vision. However, due to the complex environment in tunnels, it is difficult to quickly obtain tunnel lining cracks via computer visions in the tunnel. Therefore, this paper presents the design of a fast acquisition system with the geometric feature analysis for tunnel lining cracks, which has been integrated into a tunnel fast inspection vehicle with a machine vision module. Through the research on the image acquisition system of the tunnel lining, the parameter selection of the crack shooting hardware system is determined, and the fast calculation method of shooting parameters is proposed. The geometric characteristic analysis of the tunnel lining crack image is employed to calculate crack width and determine the optimal gray value of crack extraction. Field tests have been conducted in the highway tunnels in Zhejiang and Yunnan provinces in China and the result indicates that the proposed approach yields much better performance in the detection efficiency, whose time of detection is only 1%, and the number of personnel required is only 40% of the traditional pure manual method. Compared with similar systems, it also has significant advantages in crack resolution and detection speed. This research provides a means of rapid acquisition of tunnel cracks and laying a foundation for the evaluation of the service performance of the tunnel.
An Improved Defect Detection Method for Substation Equipment

Abstract:Substation equipment inspection is the fundamental of equipment management and security. However, the substation equipment inspection is facing the prominent contradiction between the surge in workload and the relative shortage of personnel. Therefore, this paper proposes an improved image-based method for detecting defects in substation equipment. This method is based on Faster R-CNN algorithm and proposes a series of improvement strategies according to the actual application scenarios, including inter-class sampling, center-guided NMS, and category-adaptive threshold. Experimental results demonstrate that this method can solve the problems of uneven sample distribution, redundant bounding-boxes, missed or false detections, etc., and improve the accuracy and practical effect of defect detection. In addition, this paper tests on a lightweight network framework, which proves the engineering applicability of this method.

Abstract:We introduce a framework to efficiently capture and identify the defects on the subway tunnel surfaces. Specifically, we design a high-speed multi-camera-synchronous acquisition system for scanning the tunnel surfaces and capturing the cracks from images. We propose an Improved Cascade Region-Based Convolutional Neural Network (R-CNN) method to locate and classify defects, with the crack being refined by image processing algorithms. The methodology is tested by on-site experiments carried out in an operational subway. The mAP value reaches 0.827, with a specific AP value of 0.625 and a newly proposed measure identification rate of 0.942 for crack objects. Notably, by training on bounding box labels, our overall algorithm exhibits the lowest Error Rate (ER) and the highest Intersection over Union (IoU) across all test images, surpassing the performance of classical semantic segmentation networks trained on pixel-level labels.

Automatic Drainage Pipeline Defect Detection Method Using Handcrafted and Network Features

Abstract:Effective maintenance of urban drainage pipeline networks is critical to the healthy development of cities. Routine CCTV surveys are costly, time-consuming and rely on technicians. In this paper, we propose a method to detect pipeline defects automatically, which can improve the efficiency of pipeline maintenance and save cost and reduce dependence on technicians. We use image restoration method to remove the interference of ropes in the pipeline image, before using Canny edge detection operator to extract the texture information of the defects. Then look for contours regionally to identify suspected defect areas. We combine the hybrid LBP handcrafted and VGG network features of suspected defect areas and use SVM classifier to predict pipeline defects. This method is more than 90% accurate on the test set. Furthermore, the high efficiency of this method enables it to compete with the performance of trained technicians. In general, this method of automatically detection pipeline defects provides a new option for the Urban Drainage Group and has a good development prospect.
Intelligent segmentation and quantification of tunnel lining cracks via computer vision

Abstract:Structural Health Monitoring, Ahead of Print. Aiming to automatically, precisely, and rapidly detect tunnel lining cracks from images and extract geometric information for structural condition assessment, this study proposes a novel tunnel lining crack segmentation network (TCSegNet) and establishes a framework for calculating key geometric parameters of cracks. A tunnel lining crack segmentation dataset is first built by conducting on-site inspections of metro tunnels and collecting open-sourced tunnel images. Afterward, the TCSegNet, conforming to the encoder–decoder architectural paradigm, is designed to separate cracks from lining images pixel-to-pixel. An improved ConvNeXt and developed efficient atrous spatial pyramid pooling module constitute the encoder. The skip connections, upsampling modules, and tailored segmentation head form the decoder. Upon the segmentation results of TCSegNet, a computing framework integrating multiple digital image processing techniques is proposed to obtain the length, average width, and maximum width of cracks. The experimental results show that the TCSegNet achieves leading results among several dominant models, with 70.78% mean intersection over union (mIoU) and 57.43% F1 score. Furthermore, the TCSegNet has 32.01 million parameters, requires 55.13 billion floating point operations, and gets 107.28 frames per second, proving that it has low time and space complexities and implements real-time segmentation. Also, the rationality and effectiveness of TCSegNet in alleviating the crack disjoint problem and preserving crack edge details are verified through comparative experiments. In addition, the TCSegNet achieves 71.99%, 70.45%, and 70.23% mIoU in high-resolution image segmentation, robustness, and generalization tests, respectively, demonstrating that it is competent for detecting high-resolution lining images, has a solid resistance to illumination variations, and can be well generalized to other tunnel lining image datasets. Finally, the applicability of the crack quantification framework is validated by practical application examples. The developed approaches in this study provide pixel-level segmentation results and detailed measurements of concrete lining cracks to assess tunnel structural safety status.

Abstract:Automatic visual inspection of cracks on concrete surface has become increasingly important for the health diagnosis of subway tunnel structures to prevent catastrophic failures. This paper designs an on‐board image acquisition system using multiple line scan cameras to capture the full‐section images of tunnel surface and proposes a robust automatic crack detection method for noisy and complicated tunnel surface images. The detection method consists of three steps. The first step is a crack enhancing process by using morphological image processing and frequency‐domain enhancing algorithm. In the second step, a multistage fusion filtering algorithm is designed to filter out background noise and interference from images of water stain and various railway devices on the tunnel surface. The third step is to use an improved seed growth algorithm to segment real cracks from the noisy background. The detection system is tested in the Beijing Metro Line 1, and the results demonstrate that the proposed method outperforms existing methods that are only robust for images of small area with a simple background.

Georisk Assessment and Management of Risk for Engineered Systems and Geohazards

Abstract:Intelligent detection of the apparent defects of tunnel linings on the basis of deep learning has become a mainstream trend, and how to objectively diagnose the hazard level of tunnel defects via semantic segmentation images is the key to intelligent control of tunnel health. In this study, a tunnel lining defect image diagnosis method that uses graph neural networks is proposed. First, the binary images obtained by semantic segmentation are used as the data set, and quantitative parameters, such as crack length, maximum width, box dimension, and area density, are calculated according to the crack orientation and employed as graph node attributes. Second, the construction of graph data is based on the similarity of defect attributes. Third, clustering is completed using graph neural networks and K-means, and the number of clusters and danger levels of crack defects are reasonably determined. Last, a tunnel crack risk index is developed via partial least squares regression analysis, and the grading criteria for defect levels are established. Results show that the method is effective in extracting the key attributes of crack images and clustering them into different hazard levels, which is important for maintaining tunnel health.

Abstract:In this paper, we present a novel defect detection model based on an improved U-Net architecture. As a semantic segmentation task, the defect detection task has the problems of background–foreground imbalance, multi-scale targets, and feature similarity between the background and defects in the real-world data. Conventionally, general convolutional neural network (CNN)-based networks mainly focus on natural image tasks, which are insensitive to the problems in our task. The proposed method has a network design for multi-scale segmentation based on the U-Net architecture including an atrous spatial pyramid pooling (ASPP) module and an inception module, and can detect various types of defects compared to conventional simple CNN-based methods. Through the experiments using a real-world subway tunnel image dataset, the proposed method showed a better performance than that of general semantic segmentation including state-of-the-art methods. Additionally, we showed that our method can achieve excellent detection balance among multi-scale defects.

Tunnelling and Underground Space Technology

Abstract:A tunnel is an imperative underground passageway that supports fast and uninterrupted transportation. Over time, various factors, such as ageing, topographical changes, and excessive force, slowly affect the tunnel's internal structure, which causes tunnel defects that can reduce the structure's stability and eventually lead to enormous damage. Therefore, the tunnels need to be checked regularly to detect and fix the cracks promptly. Earlier inspection approaches mainly relied on the operators who directly observed videos to detect the cracks and determine their seriousness, which is laborious, error-prone, and tedious. This research suggests a deep learning-based tunnel lining crack segmentation framework for tunnel images taken by high-resolution cameras. The primary contributions are (1) a lining crack segmentation framework, which is motivated by U-Net architecture, where the encoder is replaced by a ResNet-152 model, (2) the automated measurement of the segmented cracks, which include length, thickness, and type, and (3) a huge lining crack segmentation database. The experimental results showed that the framework obtained comparable performance compared to existing crack segmentation models and supported the automated measurement of the segmented cracks.
