Abstract:Abstract Over past two decades, organic photovoltaics (OPVs) with unique advantages of low cost and flexibility meet significant development opportunities and the official world record for the power conversion efficiency (PCE) of organic solar cells (OSCs) has reached to 17.3%. Traditionally, efficiency breakthrough need the constant input of intensive labor and time. The artificial intelligence, as a rising interdisciplinary, brings certainly a revolution in research methods. In this review, we introduce a state‐of‐art theoretical methodology of the synergy of high‐throughput screening and machine learning (ML) in accelerating the discovery of high‐efficient OSC materials. We present key details, rules and experience in database construction, selection of molecular features, fast‐screening calculations, models training and their predication capabilities. Meanwhile, three typical ML frameworks are concluded to reveal the structure‐property‐efficiency relationship, suggesting that this theoretical methodology can train powerful models with just molecular configurations and theoretical calculations for molecular design and efficiency improvements.

Abstract:Abstract To design efficient materials for organic photovoltaics (OPVs), it is essential to identify the largest number of parameters that control their properties and build a model using these parameters (known as descriptors) for the prediction of the power conversion efficiency (PCE). By constructing a dataset for 280 small molecule OPV systems, it is found that for all high‐performing devices, frontier molecular orbitals of donor molecules are nearly degenerated and in such cases, orbitals other than just highest occupied molecular orbital (HOMO) and lowest unoccupied molecular orbital (LUMO) are involved in exciton formation, exciton dissociation, and hole transport processes influencing the macroscopic properties of OPVs. Machine learning approaches, including random forest, gradient boosting, deep neural network are used to build models for the prediction of PCE using 13 important microscopic properties of organic materials as descriptors. Quite impressive performance of the gradient boosting model (Pearson's coefficient = 0.79) indicates that it can certainly be applied to high‐throughput virtual screening of promising new donor molecules for high‐efficiency OPVs.

Abstract:Perovskite solar cells (PSCs) offer a promising avenue for renewable energy due to their ease of preparation, high energy conversion efficiency, and environmental friendliness. However, the traditional trial-and-error approach in preparing high-efficiency PSCs is inefficient. To address this, our study introduces a goal-driven approach that integrates machine learning and data mining techniques to rapidly screen high-efficiency PSCs based on key features. By successfully predicting high-efficiency PSCs and identifying the dominant factors affecting their performance, namely the perovskite bandgap and the total thickness of the electron transport layer (ETL), this research provides valuable insights for optimizing preparation processes and advancing the development of high-efficiency PSCs, thus significantly contributing to the renewable energy sector.

Abstract:The development of perovskite solar cells (PSCs) has received much attention in recent years, but material selection schemes based on trial-and-error methods have made the enhancement of perovskite solar cell performance a huge challenge. Here, we propose a machine learning framework to predict the Photoelectric conversion efficiency (PCE) of PSCs with high speed and accuracy and use a Bayesian algorithm to inverse predict the optimal values of the underlying parameters (band gap, thickness of each layer, defect density, etc.) of PSC devices. Four different machine learning models, including the Extremely Randomized Trees (ExtRa Trees), k-nearest neighbor (KNN), light gradient boosting machine (LGBM), and random forest regression (RF) were adopted for training, with the ExtRa Trees model giving the best prediction performance (R 2 = 0.71). In addition interpretable machine learning was applied to extract the performance-structure relationship for the PSCs. A Bayesian approach was used to rapidly derive optimal values for the cell device parameters at a PCE of 23%, which greatly accelerated the PSC manufacturing process. This work demonstrates the great potential of machine learning to accelerate the development of PSCs.

Abstract:Measuring the performance of solar energy and heat transfer systems requires a lot of time, economic cost and manpower. Meanwhile, directly predicting their performance is challenging due to the complicated internal structures. Fortunately, a knowledge-based machine learning method can provide a promising prediction and optimization strategy for the performance of energy systems. In this Chapter, the authors will show how they utilize the machine learning models trained from a large experimental database to perform precise prediction and optimization on a solar water heater (SWH) system. A new energy system optimization strategy based on a high-throughput screening (HTS) process is proposed. This Chapter consists of: i) Comparative studies on varieties of machine learning models (artificial neural networks (ANNs), support vector machine (SVM) and extreme learning machine (ELM)) to predict the performances of SWHs; ii) Development of an ANN-based software to assist the quick prediction and iii) Introduction of a computational HTS method to design a high-performance SWH system.

Abstract:Navigating chemical space for organic photovoltaics (OPVs) is in high demand for further increasing the device efficiency, which can be accelerated through virtual screening of a large number of possible candidate molecules using a computationally cheap and efficient model. However, predicting the efficiency of an OPV is quite challenging due to the complex correlations between factors influencing the energy conversion process. In this work, we performed high-throughput virtual screening of 10170 candidate molecules, constructed from 32 unique building blocks, with several newly built, computationally affordable and high-performing (Pearson's correlation coefficient=0.7-0.8) machine learning (ML) models using relevant descriptors. Important building blocks are identified, and new design rules are introduced to construct efficient molecules. The critical molecular properties required for high efficiency are unraveled. Also, 126 candidates with theoretically predicted efficiency > 8% are proposed for synthesis and device fabrication. Similar ML-assisted virtual screening works may reveal hidden guidelines to design promising molecules and could be a breakthrough in search of lead candidates for OPVs.

Abstract:<p></p><p>The commercial development of perovskite solar cells(PSCs) hasbeen significantly delayed by the constraint of performing time-consumingdegradation studies under real outdoor conditions. These are necessarysteps to determine the device lifetime, an area where PSCs traditionallysuffer. In this work, we demonstrate that the outdoor degradationbehavior of PSCs can be predicted by employing accelerated indoorstability analyses. The prediction was possible using a swift andaccurate pipeline of machine learning algorithms and mathematicaldecompositions. By training the algorithms with different indoor stabilitydata sets, we can determine the most relevant stress factors, therebyshedding light on the outdoor degradation pathways. Our methodologyis not specific to PSCs and can be extended to other PV technologieswhere degradation and its mechanisms are crucial elements of theirwidespread adoption.</p>

Comparing Hyper-optimized Machine Learning Models for Predicting Efficiency Degradation in Organic Solar Cells

Abstract:This work presents a set of optimal machine learning (ML) models to represent the temporal degradation suffered by the power conversion efficiency (PCE) of polymeric organic solar cells (OSCs) with a multilayer structure ITO/PEDOT:PSS/P3HT:PCBM/Al. To that aim, we generated a database with 996 entries, which includes up to 7 variables regarding both the manufacturing process and environmental conditions for more than 180 days. Then, we relied on a software framework that brings together a conglomeration of automated ML protocols that execute sequentially against our database by simply command-line interface. This easily permits hyper-optimizing and randomizing seeds of the ML models through exhaustive benchmarking so that optimal models are obtained. The accuracy achieved reaches values of the coefficient determination (R2) widely exceeding 0.90, whereas the root mean squared error (RMSE), sum of squared error (SSE), and mean absolute error (MAE)>1% of the target value, the PCE. Additionally, we contribute with validated models able to screen the behavior of OSCs never seen in the database. In that case, R2~0.96-0.97 and RMSE~1%, thus confirming the reliability of the proposal to predict. For comparative purposes, classical Bayesian regression fitting based on non-linear mean squares (LMS) are also presented, which only perform sufficiently for univariate cases of single OSCs. Hence they fail to outperform the breadth of the capabilities shown by the ML models. Finally, thanks to the standardized results offered by the ML framework, we study the dependencies between the variables of the dataset and their implications for the optimal performance and stability of the OSCs. Reproducibility is ensured by a standardized report altogether with the dataset, which are publicly available at Github.

Abstract:Perovskite solar cells (PSCs) have garnered significant attention owing to their highly power conversion efficiency (PCE) and cost-effectiveness. Traditionally, screening for PSCs with superior photovoltaic parameters relies on resource-intensive trial-and-error experiments. Nowadays, time-saving machine learning (ML) techniques serve as an artificial intelligence approach to expedite the prediction of photovoltaic parameters using accumulated research datasets. In this study, we employ seven supervised ML methods to forecast key photovoltaic parameters for PSCs such as PCE, Short-Circuit Current Density (Jsc), Open-Circuit Voltage (Voc), and Fill Factor (FF). Particularly, we design an artificial neural network (ANN) architecture that incorporates residual connectivity and layer normalization after the linear layers to enhance the scope and adaptability of the network. For PCE and Jsc, ANN demonstrates superior prediction accuracy, yielding root mean square errors of 2.632% and 2.244 mA/cm2, respectively. The Random Forest (RF) model exhibits exceptional prediction performance for Voc and FF. Additionally, an interpretability analysis of the model is conducted to elucidate the impact of features on PCE prediction, offering a novel approach for accurate and interpretable ML methods in the context of PSCs.

Autonomous Optimization of an Organic Solar Cell in a 4-dimensional Parameter Space

Abstract:Optimizing solution-processed organic solar cells is a complex task due to the vast parameter space in organic photovoltaics (OPV). Classical Edisonian or one-variable-at-a-time (OVAT) optimization approaches are laborious, time-consuming, and may not find the optimal parameter set in multidimensional design spaces. To tackle this problem, we demonstrate here for the first time artificial intelligence (AI) guided closed-loop autonomous optimization for fully functional organic solar cells. We empower our LineOne, an automated materials and device acceleration platform with a Bayesian Optimizer (BO) to enable autonomous operation for solving complex optimization problems without human interference. The system is able to fabricate and characterize complete OPV devices and navigate efficiently through the design space spanned by composition and processing parameters. In addition, a Gaussian Progress Regression (GPR) based early prediction model is employed to predict the efficiency of the cells from cheap proxy measurements, in our case, thin film absorption spectra, which are analyzed using a spectral model based on physical properties to generate microstructure features as input for the GPR. We demonstrate our generic and complete autonomous approach by optimizing composition and processing conditions of a ternary OPV system (PM6:Y12:PC70BM) in a four-dimensional parameter space. We identify the best parameter set for our system and obtain a precise objective function over the whole parameter space with a minimal number of samples. We demonstrate autonomous optimization of a complex opto-electronic device within 40 samples only, whereas an Edisonian approach would have required about 1000 samples. This raises an important discussion on the necessity of autonomous platforms to accelerate Material science.

Abstract:Organic photovoltaic (OPV) cells are at the forefront of sustainable energy generation due to their lightness, flexibility, and low production costs. These characteristics make OPVs a promising solution for achieving sustainable development goals. However, predicting their lifetime remains challenging task due to complex interactions between internal factors such as material degradation, interface stability, and morphological changes, and external factors like environmental conditions, mechanical stress, and encapsulation quality. In this study, we propose a machine learning-based technique to predict the degradation over time of OPVs. Specifically, we employ multi-layer perceptron (MLP) and long short-term memory (LSTM) neural networks to predict the power conversion efficiency (PCE) of inverted organic solar cells (iOSCs) made from the blend PTB7-Th:PC 70 BM, with PFN as the electron transport layer (ETL), fabricated under an N2 environment. We evaluate the performance of the proposed technique using several statistical metrics, including mean squared error (MSE), root mean squared error (rMSE), relative squared error (RSE), relative absolute error (RAE), and the correlation coefficient (R). The results demonstrate the high accuracy of our proposed technique, evidenced by the minimal error between predicted and experimentally measured PCE values: 0.0325 for RSE, 0.0729 for RAE, 0.2223 for rMSE, and 0.0541 for MSE using the LSTM model. These findings highlight the potential of proposed models in accurately predicting the performance of OPVs, thus contributing to the advancement of sustainable energy technologies.

Abstract:The performance of the metal halide perovskite solar cells (PSCs) highly relies on the experimental parameters, including the fabrication processes and the compositions of the perovskites; tremendous experimental work has been done to optimize these factors. However, predicting the device performance of the PSCs from the fabrication parameters before experiments is still challenging. Herein, we bridge this gap by machine learning (ML) based on a dataset including 1072 devices from peer-reviewed publications. The optimized ML model accurately predicts the PCE from the experimental parameters with a root mean square error of 1.28% and a Pearson coefficient r of 0.768. Moreover, the factors governing the device performance are ranked by shapley additive explanations (SHAP), among which, A-site cation is crucial to getting highly efficient PSCs. Experiments and density functional theory calculations are employed to validate and help explain the predicting results by the ML model. Our work reveals the feasibility of ML in predicting the device performance from the experimental parameters before experiments, which enables the reverse experimental design toward highly efficient PSCs.

Abstract:The objective of this paper is proposed a forecasting technique system constitute the data integrity phase using Machine Learning (ML) techniques and post-processing output optimization to improve the performance. The outcomes demonstrated that the Photo Voltaic (PV) energy manufacture neural network performed more accurate by reducing solar irradiance prediction errors of linear regression characteristics. Through the adoption of both the optimized method settings and chosen function of ML methods were evaluated for predicting the performance. The accuracy of solar radiation estimation could be assessed in terms of statistical error measurement and verification measurements. The approach was tested in two climates hot and cold and the findings demonstrated using absolute error percentage with a contribution of 6.3% and 4.7%, respectively to improve the performance of the system based on data-driven ML algorithms and analytical post-processing.

Abstract:SPINBOT, a fully automated platform, integrates machine learning to optimize solution‐processed perovskite thin films. It efficiently explores an intricate multi‐dimensional parameter space to produce high‐quality and reproducible films. As a result, the optimized film achieves an impressive 21.6% power conversion efficiency in solar cells under ambient conditions, along with excellent long‐term stability. Simultaneously optimizing the processing parameters of functional thin films remains a challenge. The design and utilization of a fully automated platform called SPINBOT is presented for the engineering of solution‐processed functional thin films. The SPINBOT is capable of performing experiments with high sampling variability through the unsupervised processing of hundreds of substrates with exceptional experimental control. Through the iterative optimization process enabled by the Bayesian optimization (BO) algorithm, the SPINBOT explores an intricate parameter space, continuously improving the quality and reproducibility of the produced thin films. This machine learning (ML)‐guided reliable SPINBOT platform enables the acceleration of the optimization process of perovskite solar cells via a simple photoluminescence characterization of films. As a result, this study arrives at an optimal film that, when processed into a solar cell in an ambient atmosphere, immediately yields a champion power conversion efficiency (PCE) of 21.6% with satisfactory performance reproducibility. The unsealed devices retain 90% of their initial efficiency after 1100 h of continuous operation at 60–65 °C under metal‐halide lamps. It is anticipated that the integration of robotic platforms with the intelligent algorithm will facilitate the widespread adoption of effective autonomous experimentation to address the evolving needs and constraints within the materials science research community.

Abstract:Optimizing light utilization is crucial in organic photovoltaics. Understanding the intricate connection between the optical properties and the chemical structure of organic materials is pivotal yet challenging in this regard. In this work, we survey over 2800 published reports with a database of ∽300 organic non‐fullerene acceptors (NFAs), and establish a mathematical model suitable for prediction and analyzing the optical properties of organic photovoltaic materials. We employ the model to predict the optical properties of representative NFAs within experimental error, including four newly synthesized organic materials to validate the model. In addition, we demonstrate the reliability and applicability of the model through data transformation and find that the addition of double bonds and asymmetry in the chemical structure does not necessarily reduce the optical bandgap of organic materials. Based on the model, we propose that the strong non‐covalent interaction is more significant than the weak non‐covalent interaction and asymmetry on the reduction of the bandgap, which provides new insights into the design and development of organic photovoltaic materials with tunable optical properties. Abstract:Novel photovoltaics, such as perovskites and perovskite-inspired materials, have shown great promise due to high efficiency and potentially low manufacturing cost. So far, solar cell R&D has mostly focused on achieving record efficiencies, a process that often results in small batches, large variance, and limited understanding of the physical causes of underperformance. This approach is intensive in time and resources, and ignores many relevant factors for industrial production, particularly the need for high reproducibility and high manufacturing yield, and the accompanying need of physical insights. The record-efficiency paradigm is effective in early-stage R&D, but becomes unsuitable for industrial translation, requiring a repetition of the optimization procedure in the industrial setting. This mismatch between optimization objectives, combined with the complexity of physical root-cause analysis, contributes to decade-long timelines to transfer new technologies into the market. Based on recent machine learning and technoeconomic advances, our perspective articulates a data-driven optimization framework to bridge R&D and manufacturing optimization approaches. We extend the maximum-efficiency optimization paradigm by considering two additional dimensions: a technoeconomic figure of merit and scalable physical inference. Our framework naturally aligns different stages of technology development with shared optimization objectives, and accelerates the optimization process by providing physical insights.
Machine Learning Approaches for Predicting Power Conversion Efficiency in Organic Solar Cells: A Comprehensive Review

Abstract:This review clarifies the using of machine learning (ML) to predict the power conversion efficiency of organic solar cells (OSCs). We focus on the predictive modeling methods, including empirical functions, ML algorithms, self‐devised ML models, and the combination of automated experimental technology with ML. Additionally, the quality of the database and the choice of descriptors are evaluated and categorized accordingly. Organic solar cells (OSCs), renowned for their lightweight, cost efficiency, and adaptability nature, stand out as a promising option for developing renewable energy. Improving the power conversion efficiency (PCE) of OSCs is essential, and researchers are delving into novel materials to achieve this. Traditional approaches are often laborious and costly, highlighting the need for predictive modeling. Machine learning (ML), especially via quantitative structure–property relationship (QSPR) models, is streamlining material development, with a goal to exceed a 20% PCE. In this review, the application of ML in OSCs is explored, and recent studies utilizing ML approaches for PCE prediction are reviewed, encompassing empirical functions, ML algorithms, self‐devised ML frameworks, and the combination with automated experimental technologies. First, the benefits of ML in predicting PCE for OSCs are addressed. Second, the development of high‐efficiency predictive models for both fullerene and nonfullerene acceptors is delved into. The impact of various ML algorithm models on PCE prediction is then assessed, taking into account the construction of predictive models. Moreover, the quality of databases and the selection of descriptors are considered. Databases and descriptors based on experimental studies are further categorized. Finally, prospects for the future development of OSCs are proposed.

Abstract:Photovoltaic technology has gain much attention in recent years for its potential to provide renewable energy in leu of traditional fossil fuels. Perovskite Solar cells have shown much promise in a relatively short time. Power conversion efficiencies have increased from 3.8% to 24.2 % in a span of ten years. Perovskite solar cells have attracted much attention in research because of the relatively low cost in manufacturing and production. Current silicon photovoltaic devices are more expensive than conventional fossil fuel. The use of Machine Learning (ML) to research and predict the opto-electronic properties of perovskite can greatly accelerate the development of this technology. ML techniques such as Linear Regression (LR), Support Vector Regression (SVR), and Artificial Neural Networks (ANNs) can greatly improve the chemical processing and manufacturing techniques. Such tools used to improve this technology have major impacts for the further proliferation of solar energy on a national scale. In this paper, we explore the current research of the development of perovskite solar cells using ML techniques. Furthermore, we cite the limitations and potential areas of further research.
