A Bayesian deep learning methodology with uncertainty quantification for harnessing the residential building heating system energy flexibility

Abstract:The field of energy flexibility assessment lacks effective methods for uncertainty assessment in building energy flexibility predictions. Existing probabilistic data-driven approaches for electric load forecasting focus either on aleatoric or epistemic uncertainty, neglecting individual energy conversion systems. This paper addresses the issue by developing Bayesian deep learning neural networks that capture both aleatoric and epistemic uncertainties in building heating system electricity consumption and zone temperature. The models include day-ahead and hour-ahead predictions and can be updated using a sliding window method. Synthetic datasets are generated using a calibrated physics-based model of an all-electric dwelling. Shorter prediction horizons demonstrate better overall performance, particularly for zone temperature, with a 41% reduction in root mean square error and a 44% decrease in the mean width of the prediction interval compared to the day-ahead model. This framework enables electricity aggregators to evaluate building portfolios considering uncertainty and multi-step predictions in an end-user tailored manner, facilitating the shift of electricity usage to off-peak or excess renewable energy periods.
