Abstract:Graph Convolutional Networks (GCNs) recently have been adopted in several feature representation studies for different classification tasks. While many of these methods are used to work with irregular structure data, they are rarely used to learn regular structure data. It is crucial to construct an excellent graph representation to traditional classification tasks for obtaining the sufficient data representation, including attribute representation and relative representation. In this context, we propose a novel method to construct a reasonable graph representation by capturing the relations in low dimensional space among the data. In order to get the well-represented, we introduce the low-rank constraint and L2-norm regularization to the graph learning framework simultaneously. Experiments demonstrate that the proposed method to learn graph representation is helpful for classification task, and leads to improved performance when compared to state-of-the-art graph learning methods on twelve data sets.
A Graph Convolutional Network-Based Approach for Community Detection in Attributed Networks

Abstract:Community detection has attracted widespread attention since it helps reveal geometric structures and latent functions of complex networks. Recently community detection has been revisited with the development of network representation learning, many approaches have been presented, including graph convolutional network (GCN) based methods. Existing GCN-based community detection methods usually rely on a considerable number of prior labels to infer unknown nodes. To address this problem, we propose a new GCN-based method for community detection in attributed networks without any label information. Based on the local self-organization characteristics of the communities, we integrate a label sampling model and the shallow GCN architecture into an unsupervised learning framework, the former helps construct a balanced training set via a local expansion strategy to train GCN. Moreover, we reveal the underlying community structures by fusing topology and attribute information. Experimental results on several real-world networks indicate our method is effective compared with the state-of-the-art community detection algorithms.

Locality preserving dense graph convolutional networks with graph context-aware node representations

Abstract:<p>Graph convolutional networks (GCNs) have been widely used for representation learning on graph data, which can capture structural patterns on a graph via specifically designed convolution and readout operations. In many graph classification applications, GCN-based approaches have outperformed traditional methods. However, most of the existing GCNs are inefficient to preserve local information of graphs — a limitation that is especially problematic for graph classification. In this work, we propose a locality-preserving dense GCN with graph context-aware node representations. Specifically, our proposed model incorporates a local node feature reconstruction module to preserve initial node features into node representations, which is realized via a simple but effective encoder–decoder mechanism. To capture local structural patterns in neighbourhoods representing different ranges of locality, dense connectivity is introduced to connect each convolutional layer and its corresponding readout with all previous convolutional layers. To enhance node representativeness, the output of each convolutional layer is concatenated with the output of the previous layer's readout to form a global context-aware node representation. In addition, a self-attention module is introduced to aggregate layer-wise representations to form the final graph-level representation. Experiments on benchmark datasets demonstrate the superiority of the proposed model over state-of-the-art methods in terms of classification accuracy.</p>

Graph contrastive learning with cross-encoder for community discovery

Abstract:Community detection is a crucial task that enables the extraction of valuable knowledge and patterns from complex networks. However, the node labels are often unavailable in most real-world applications, which poses limitations on practical implementations. It is common to deal with graphs that have side information. How to effectively fuse the topology information of a graph and the attribute information of nodes also brings great challenges to community discovery task. In this paper, a graph contrastive learning algorithm with cross-encoder is proposed for community discovery. The proposed algorithm introduces graph convolution neural network and graph attention network to fuse the topology information and the attribute information of nodes. Then it employs cross-encoder to obtain the embedding vectors of nodes and the neural networks are trained by contrastive learning which can learn the embedding vectors of nodes from different views. The proposed algorithm and the comparison algorithms are conducted on multiple real data sets. The experimental results show that the proposed algorithm outperforms the comparison algorithms on the most experimental data sets. The experimental results prove that the proposed algorithm is effective for community discovery.

Abstract:Community detection is to partition a network into several components, each of which contains densely connected nodes with some structural similarities. Recently, multiplex networks, each layer consisting of a same node set but with a different topology by a unique edge type, have been proposed to model real-world multi-relational networks. Although some heuristic algorithms have been extended into multiplex networks, little work on neural models have been done so far. In this paper, we propose a graph convolutional fusion model (GCFM) for community detection in multiplex networks, which takes account of both intra-layer structural and inter-layer relational information for learning node representation in an interwoven fashion. In particular, we first develop a graph convolutional auto-encoder for each network layer to encode neighbor-aware intra-layer structural features under different convolution scales. We next design a multiscale fusion network to learn a holistic version of nodes’ representations by fusing nodes’ encodings at different layers and different scales. Finally, a self-training mechanism is used to train our model and output community divisions. Experiment results on both synthetic and real-world datasets indicate that the proposed GCFM outperforms the state-of-the-art techniques in terms of better detection performances.
Efficient Learning-based Community-Preserving Graph Generation

Abstract:Graph generation is beneficial to comprehend the creation of meaningful structures of networks in a broad spectrum of applications such as social networks and biological networks. Recent studies tend to leverage deep learning techniques to learn the topology structures in graphs. However, we notice that the community structure, which is one of the most unique and prominent features of the graph, cannot be well captured by the existing graph generators. Moreover, the existing advanced deep learning-based graph generators are not efficient and scalable, which can only handle small graphs. In this paper, we propose a novel community-preserving generative adversarial network (CPGAN) for effective and efficient (scalable) graph simulation. We employ graph convolution networks in the encoder and share parameters in the generation process to transmit information about community structures and preserve the permutationinvariance in CPGAN. We conducted extensive experiments on benchmark datasets, including six sets of real-life graphs. The results demonstrate that CPGAN can achieve a good tradeoff between efficiency (scalability) and graph simulation quality for real-life graph simulation compared with state-of-the-art baselines.

Abstract:Community detection is a fundamental problem in network science with various applications. The problem has attracted much attention and many approaches have been proposed. Among the existing approaches are the latest methods based on Graph Convolutional Networks (GCN) and on statistical modeling of Markov Random Fields (MRF). Here, we propose to integrate the techniques of GCN and MRF to solve the problem of semi-supervised community detection in attributed networks with semantic information. Our new method takes advantage of salient features of GNN and MRF and exploits both network topology and node semantic information in a complete end-to-end deep network architecture. Our extensive experiments demonstrate the superior performance of the new method over state-of-the-art methods and its scalability on several large benchmark problems.

Abstract:With the continuous development of technology and networks, real-life interactions are gradually being abstracted into social networks for study. Social circles are a fundamental structural feature that is prevalent on social networks. Thus, exploring social circle structure plays an important role in revealing the characteristics of complex social networks and provides guidance for understanding social behavior in real life. For example, it can aid in precision marketing, personalized recommendation, and knowledge dissemination within social circles. One of the important means of identifying social network circles lies on community detection algorithms. However, real-world social networks are often dynamic and can be studied and analyzed by building dynamic networks, while existing dynamic network community detection methods tend to ignore the global structure information and time-series information of nodes. To address this problem, this paper proposes a dynamic network community detection algorithm based on graph convolutional neural networks and contrastive learning, which fully captures the adjacent characteristics between nodes based on the correlation information and leverages the feature smoothing strategy to efficiently extract node representations of dynamic networks under unsupervised scenario. Specifically, the proposed algorithm first utilizes node correlation based aggregation strategy to compute the feature matrix for single time-step of the dynamic network. Then, mutual information maximization is implemented based on cross-entropy between learned local and global representations. To reduce the computational overhead in the optimization process, an additional LSTM module is further equipped for updating the parameters of graph convolutional networks in each time-step. Additionally, a contrastive learning based network smoothing strategy is designed to minimize the feature differences between neighboring nodes. Comparative experiments demonstrate that the proposed algorithm achieves excellent performance on both synthetic and real networks.

QD-GCN: Query-Driven Graph Convolutional Networks for Attributed Community Search

Abstract: Recently, attributed community search, a related but different problem to community detection and graph clustering, has been widely studied in the literature. Compared with the community detection that finds all existing static communities from a graph, the attributed community search (ACS) is more challenging since it aims to find dynamic communities with both cohesive structures and homogeneous node attributes given arbitrary queries. To solve the ACS problem, the most popular paradigm is to simplify the problem as two sub-problems, that is, structural matching and attribute filtering and deal with them separately. However, in real-world graphs, the community structure and the node attributes are actually correlated to each other. In this vein, current studies cannot capture these correlations which are vital for the ACS problem. In this paper, we propose Query-Driven Graph Convolutional Networks (QD-GCN), an end-to-end framework that unifies the community structure as well as node attribute to solve the ACS problem. In particular, QD-GCN leverages the Graph Convolutional Networks, which is a powerful tool to encode the graph topology and node attributes concurrently, as the backbones to extract the query-dependent community information from the original graph. By utilizing this query-dependent community information, QD-GCN is able to predict the target community given any queries. Experiments on real-world graphs with ground-truth communities demonstrate that QD-GCN outperforms existing attributed community search algorithms in terms of both efficiency and effectiveness.

Abstract:Lately, there has been exploration and successful implementation of various approaches of deep learning in different systems such as visual processing, pattern recognition, speech recognition, etc. In this research work, we explore the possibilities of employing the deep learning methods like Graph Neural Network (GNN) to unveil hidden communities among the complex networks. Complex systems have gained mounting attention in numerous areas, including biological networks, social networks, the recommender system, information graphs, and also life sciences. Scientific upgradation pertinent to network analysis is enabled by the role of deep learning models in forming an interaction of nodes in a graph. In the research paper, we propose a deep learning model, Gumbel-SoftMax based Graph Convolution Network (GS-GCN) approach to discern the clusters present in complex networks. We have also used the Gumbel-SoftMax measure to retrieve the relevant features of the given networks. We have used two-layer graph convolution network model. In this model, we have utilized two parameters, degree matrix and adjacency matrix with loops to enhance the performance. The experimental outcomes substantiate that the proposed approach outperforms the conventional methods noticeably, which clearly demonstrates the efficacy of deep learning models in uncovering the communities hidden in graph networks. We have performed rounds of testing on the proposed GS-GCN method, using four real-world datasets, namely, Zachary Karate club, Dolphins, Political Books, and Les Misérables. The fact that the proposed method discovers better community structures is proved by the results of the detailed experiments.
Representation Learning Method of Graph Convolutional Network Based on Structure Enhancement

Abstract:Network representation learning has attracted widespread attention as a pre-processing process for some machine learning and deep learning tasks. How-ever, most existing methods only consider influence of nodes' low-order neighbors to represent them. Either nodes' high-order neighbor or the intrinsic characteris-tic attributes of nodes are ignored, leading to the effect of network representation learning that needs to be improved. This paper proposes a novel model named Structure Enhanced Graph Convolutional Network (SEGCN) to address these lim-itations. SEGCN consists of the following components, i.e., the network structure enhancement to transform weak relationship into strong relationship, the node fea-ture aggregation to fuse high-order neighbor information. Hence, the SEGCN model can simultaneously integrate network structure information, attribute information, and high-order neighbor relationships together. Experimental results for node clas-sification and node clustering on six datasets show that SEGCN achieves better effectiveness and efficiency than state-of-the-art baselines.
Overlapping community detection on complex networks with graph convolutional networks

Abstract:Discovering the community structure within networks is of significance with respect to many realistic applications, like recommendation systems and cyberattack detection. In this study, we propose an overlapping community detection method CDMG based on Graph Convolutional Network (GCN) from the perspective of maximizing the Markov stability of community structure, which is defined in terms of the clustered autocovariance of a Markov process taking place on the network. Extensive experiments on both the attributed networks and the normal networks with different scales demonstrate the superiority of CDMG compared to other established community detection algorithms. Additionally, the Markov stability of the community structure relies on a time parameter, Markov time, and we observe that the performance of CDMG can be further improved by utilizing the optimal Markov time. According to the variation curve that demonstrates the influence of Markov time t on the performance of CDMG, we propose a trichotomy-based method to search for the optimal Markov time for our method.

Graph Convolutional Networks with Adaptive Neighborhood Awareness

Abstract:Graph convolutional networks (GCNs) can quickly and accurately learn graph representations and have shown powerful performance in many graph learning domains. Despite their effectiveness, neighborhood awareness remains essential and challenging for GCNs. Existing methods usually perform neighborhood-aware steps only from the node or hop level, which leads to a lack of capability to learn the neighborhood information of nodes from both global and local perspectives. Moreover, most methods learn the nodes' neighborhood information from a single view, ignoring the importance of multiple views. To address the above issues, we propose a multi-view adaptive neighborhood-aware approach to learn graph representations efficiently. Specifically, we propose three random feature masking variants to perturb some neighbors' information to promote the robustness of graph convolution operators at node-level neighborhood awareness and exploit the attention mechanism to select important neighbors from the hop level adaptively. We also utilize the multi-channel technique and introduce a proposed multi-view loss to perceive neighborhood information from multiple perspectives. Extensive experiments show that our method can better obtain graph representation and has high accuracy.
Disentangled Graph Convolutional Networks

Abstract:The formation of a real-world graph typically arises from the highly complex interaction of many latent factors. The existing deep learning methods for graph-structured data neglect the entanglement of the latent factors, rendering the learned representations non-robust and hardly ex-plainable. However, learning representations that disentangle the latent factors poses great challenges and remains largely unexplored in the literature of graph neural networks. In this paper, we introduce the disentangled graph convolutional network (DisenGCN) to learn disentangled node representations. In particular, we propose a novel neighborhood routing mechanism, which is capable of dynamically identifying the latent factor that may have caused the edge between a node and one of its neighbors, and accordingly assigning the neighbor to a channel that extracts and convolutes features speciﬁc to that factor. We theoretically prove the convergence properties of the routing mechanism. Empirical results show that our proposed model can achieve signiﬁcant performance gains, especially when the data demonstrate the existence of many entangled factors.

Abstract:Graph neural networks have achieved impressive progress in solving large and complex graph-structured problems. However, existing methods cannot sufficiently explore the advantages of multi-scale information by enlarging the receptive fields through stacking deep layers or multiplying exponentiated graph Laplacian. They are restricted by the discrete scales rigidly dependent on node-hops or suffer from the over-smoothing issue incurred by long-range low-pass filtering. In this paper, we propose a multi-scale graph convolutional network based on the spectral graph wavelet frame to improve multi-scale representation learning. The proposed network flexibly leverages multi-scale neighboring information with continuous scaling to enhance the discrimination ability of the learned multi-scale representations and offer stable feature extraction ensured by frame bounds in theory. The multi-scale spectral convolutional layer is constructed with a low-pass filter and a sequence of dilated band-pass filters to achieve well-established localization in both vertex and frequency domains. The graph convolutional filters can be realized based on spectral graph wavelet kernel functions analytically formulated using parameterized band-limited filters or adaptively learned from training data. Furthermore, fast approximations of exact spectral filtering are developed for memory efficient operations on sparse tensors with guaranteed prediction accuracy and numerical stability. The proposed network is shown to achieve state-of-the-art performance in extensive experiments on citation networks, bioinformatics graphs, and social networks.
GeCNs: Graph Elastic Convolutional Networks for Data Representation

Abstract:Graph representation and learning is a fundamental problem in machine learning area. Graph Convolutional Networks (GCNs) have been recently studied and demonstrated very powerful for graph representation and learning. Graph convolution (GC) operation in GCNs can be regarded as a composition of feature aggregation and nonlinear transformation step. Existing GCs generally conduct feature aggregation on a full neighborhood set in which each node computes its representation by aggregating the feature information of all its neighbors. However, this full aggregation strategy is not guaranteed to be optimal for GCN learning and also can be affected by some graph structure noises, such as incorrect or undesired edge connections. To address these issues, we propose to integrate elastic net based selection into graph convolution and propose a novel graph elastic convolution (GeC) operation. In GeC, each node can adaptively select the optimal neighbors in its feature aggregation. The key aspect of the proposed GeC operation is that it can be formulated by a regularization framework, based on which we can derive a simple update rule to implement GeC in a self-supervised manner. Using GeC, we then present a novel GeCN for graph learning. Experimental results demonstrate the effectiveness and robustness of GeCN.
Community-CL: An Enhanced Community Detection Algorithm Based on Contrastive Learning

Abstract:Graph contrastive learning (GCL) has gained considerable attention as a self-supervised learning technique that has been successfully employed in various applications, such as node classification, node clustering, and link prediction. Despite its achievements, GCL has limited exploration of the community structure of graphs. This paper presents a novel online framework called Community Contrastive Learning (Community-CL) for simultaneously learning node representations and detecting communities in a network. The proposed method employs contrastive learning to minimize the difference in the latent representations of nodes and communities in different graph views. To achieve this, learnable graph augmentation views using a graph auto-encoder (GAE) are proposed, followed by a shared encoder that learns the feature matrix of the original graph and augmentation views. This joint contrastive framework enables more accurate representation learning of the network and results in more expressive embeddings than traditional community detection algorithms that solely optimize for community structure. Experimental results demonstrate that Community-CL achieves superior performance compared to state-of-the-art baselines in community detection. Specifically, the NMI of Community-CL is reported to be 0.714 (0.551) on the Amazon-Photo (Amazon-Computers) dataset, which represents a performance improvement of up to 16% compared with the best baseline.

Abstract:Graph patterns play a critical role in various graph classification tasks, e.g., chemical patterns often determine the properties of molecular graphs. Researchers devote themselves to adapting Convolutional Neural Networks (CNNs) to graph classification due to their powerful capability in pattern learning. The varying numbers of neighbor nodes and the lack of canonical order of nodes on graphs pose challenges in constructing receptive fields for CNNs. Existing methods generally follow a heuristic ranking-based framework, which constructs receptive fields by selecting a fixed number of nodes and dropping the others according to predetermined rules. However, such methods may lose important structure information through dropping nodes, and they also cannot learn task-oriented graph patterns. In this paper, we propose a Location learning-based Convolutional Neural Networks (LCNN) for graph classification. LCNN constructs receptive fields by learning the location of each node according to its embedding that contains structures and features information, then standard CNNs are applied to capture graph patterns. Such a location learning mechanism not only retains the information of all nodes, but also provides the ability for task-oriented pattern learning.
