Abstract:The multi‐electron reduction of CO 2 to hydrocarbons or alcohols is highly attractive in a sustainable energy economy, and the rational design of electrocatalysts is vital to achieve these reactions efficiently. Single‐atom electrocatalysts are promising candidates due to their well‐defined coordination configurations and unique electronic structures, which are critical for delivering high activity and selectivity and may accelerate the explorations of the activity origin at atomic level as well. Although much effort has been devoted to multi‐electron reduction of CO 2 on single‐atom electrocatalysts, there are still no reviews focusing on this emerging field and constructive perspectives are also urgent to be addressed. Herein recent advances in how to design efficient single‐atom electrocatalysts for multi‐electron reduction of CO 2 , with emphasis on strategies in regulating the interactions between active sites and key reaction intermediates, are summarized. Such interactions are crucial in designing active sites for optimizing the multi‐electron reduction steps and maximizing the catalytic performance. Different design strategies including regulation of metal centers, single‐atom alloys, non‐metal single‐atom catalysts, and tandem catalysts, are discussed accordingly. Finally, current challenges and future opportunities for deep electroreduction of CO 2 are proposed.

Abstract:Converting CO2 into carbon-based fuels is promising for relieving the greenhouse gas effect and the energy crisis. However, the selectivity and efficiency of current electrocatalysts for CO2 reductions are still not satisfactory. In this paper, the development of machine learning methods in screening CO2 reduction electrocatalysts over the recent years is reviewed. Through high-throughput calculation of some key descriptors such as adsorption energies, d-band center, and coordination number by well-constructed machine learning models, the catalytic activity, optimal composition, active sites, and CO2 reduction reaction pathway over various possible materials can be predicted and understood. Machine learning is now realized as a fast and low-cost method to effectively explore high performance electrocatalysts for CO2 reduction.

Abstract:Electrochemical carbon dioxide reduction to fuels presents one of the great challenges in chemistry. Herein we present an understanding of trends in electrocatalytic activity for carbon dioxide reduction over different metal catalysts that rationalize a number of experimental observations including the selectivity with respect to the competing hydrogen evolution reaction. We also identify two design criteria for more active catalysts. The understanding is based on density functional theory calculations of activation energies for electrochemical carbon monoxide reduction as a basis for an electrochemical kinetic model of the process. We develop scaling relations relating transition state energies to the carbon monoxide adsorption energy and determine the optimal value of this descriptor to be very close to that of copper.

Abstract:CO2 electroreduction is one of the most potential ways to realize CO2 recycle and energy regeneration. The key to promote this technology is the development of high-performance electrocatalysts. However, the rational design of electrocatalysts with highly catalytic activity and products selectivity toward CO2 reduction reaction (CO2RR) remains a challenging task. Herein, we developed a machine learning (ML) model to achieve efficient exploration of electrocatalysts for CO2RR by combining with density functional theory (DFT). The results show that the electron numbers of the d orbital is the most important descriptor and the support vector regression (SVR) has the best predictive performance. The coefficient of determination (R2) and mean squared error (MSE) are 0.9193 and 0.0162, respectively. Based on the well-trained model, the overpotential of Ni@MoS2 is successfully predicted to be 0.477 V and it shows the best electrocatalytic performance for CO2RR. DFT calculation results show that *COOH → *CO is the potential-limiting step of CO2-to-CO electroreduction for Ni@MoS2. The DFT-calculated overpotential is 0.481 V, which is consistent with the ML-predicted results. This work provides a convenient machine learning model for the effective theoretical design and screening of CO2-to-CO electrocatalysts.

Abstract:In this work, high-performance two-dimensional (2D) carbon-based single-atom electrocatalysts (ZZ/ZA-MNxCy) for the oxygen reduction reaction (ORR) were screened out using machine learning (ML) method. A model was built for the fast prediction of electrocatalysts and two descriptors valence electron correction (VEc) and degree of construction differences (DC) were proposed to improve the accuracy of the model prediction. Two evaluation criteria, high-performance catalyst retention rate rR and high-performance catalyst occupancy rate rO, were proposed to evaluate the accuracy of ML model in high-performance catalysts screening. The addition of VEc and DC in the model could reduce the mean absolute error (MAE) of test set, rO, rR from 0.333 V, 0.222, 0.360 to 0.273 V, 0.421, 0.671, respectively. The screened potential high-performance ORR electrocatalysts with overpotential (ηORR) < 0.7 V such as ZZ-CoN4, ZZ-CoN3C1 were also further investigated using Density Functional Theory (DFT) method, which confirmed the accuracy of the ML model (MAE = 0.173 V).

Abstract:Copper-based catalyst is very active for electroreduction of carbon dioxide (CO 2 ) to carbon monoxide (CO). However, the Faraday efficiency of copper-based catalysts for CO production can be affected by many complex factors, such as catalyst elemental composition, morphology, supporting substrate, synthesis method, catalyst size, electrolyte concentration, and test potential with unknown correlations, hindering the efficient exploration of active copper-based CO 2 reduction catalysts with high CO Faraday efficiency. In this study, a machine learning (ML) model is proposed towards rapid screening of copper-based catalysts with high CO selectivity using experimental database. The significance of different catalyst-related features on the CO Faraday efficiency was evaluated using feature importance and Spearman correlation coefficients. The ML model predicted that the dendrite Pd-doped copper oxides catalyst electroless deposited on copper mesh has the highest CO Faraday efficiency (92.8%). This ML study provides a useful guidance for the screening of copper-based catalysts towards the reduction of CO 2 to CO.

Abstract:To achieve an equitable energy transition toward net-zero 2050 goals, the electrochemical reduction of CO2 (CO2RR) to chemical feedstocks through utilizing both CO2 and renewable energy is particularly attractive. However, the catalytic activity of CO2RR is limited by the scaling relation of the adsorption energies of intermediates. Circumventing the scaling relation is a potential strategy to achieve a breakthrough in catalytic activity. Herein, based on density functional theory (DFT) calculations, we designed a high-entropy alloy (HEA) system of FeCoNiCuMo with high catalytic activity for CO2RR. Machine learning models were developed by considering 1280 adsorption sites to predict the adsorption energies of COOH*, CO*, and CHO*. The scaling relation between the adsorption energies of COOH*, CO*, and CHO* is circumvented by the rotation of COOH* and CHO* on the designed HEA surface, resulting in the outstanding catalytic activity of CO2RR with the limiting potential of 0.29-0.51 V. This work not only accelerates the development of HEA catalysts but also provides an effective strategy to circumvent the scaling relation.

Abstract:In this review, we comprehensively introduce the machine learning workflow and standard models for hydrogen reduction reactions (HER). This mainly illustrates how machine learning is used in catalyst filtration and descriptor exploration. Several applications, including surface electrocatalysts, two‐dimensional electrocatalysts, and single/dual atom electrocatalysts using machine learning in electrocatalytic HER, are highlighted and introduced. Electrocatalytic hydrogen evolution reaction (HER) is a promising strategy to solve and mitigate the coming energy shortage and global environmental pollution. Searching for efficient electrocatalysts for HER remains challenging through traditional trial‐and‐error methods from numerous potential material candidates. Theoretical high throughput calculation assisted by machine learning is a possible method to screen excellent HER electrocatalysts effectively. This will pave the way for high‐efficiency and low‐price electrocatalyst findings. In this review, we comprehensively introduce the machine learning workflow and standard models for hydrogen reduction reactions. This mainly illustrates how machine learning is used in catalyst filtration and descriptor exploration. Subsequently, several applications, including surface electrocatalysts, two‐dimensional (2D) electrocatalysts, and single/dual atom electrocatalysts using machine learning in electrocatalytic HER, are highlighted and introduced. Machine-Learning-Augmented Chemisorption Model for CO2 Electroreduction Catalyst Screening.

Abstract:We present a machine-learning-augmented chemisorption model that enables fast and accurate prediction of the surface reactivity of metal alloys within a broad chemical space. Specifically, we show that artificial neural networks, a family of biologically inspired learning algorithms, trained with a set of ab initio adsorption energies and electronic fingerprints of idealized bimetallic surfaces, can capture complex, nonlinear interactions of adsorbates (e.g., *CO) on multimetallics with ∼0.1 eV error, outperforming the two-level interaction model in prediction. By leveraging scaling relations between adsorption energies of similar adsorbates, we illustrate that this integrated approach greatly facilitates high-throughput catalyst screening and, as a specific case, suggests promising {100}-terminated multimetallic alloys with improved efficiency and selectivity for CO2 electrochemical reduction to C2 species. Statistical analysis of the network response to perturbations of input features underpins our fundamental understanding of chemical bonding on metal surfaces.

Abstract:In the application of renewable energy, the oxidation-reduction reaction (ORR) and oxygen evolution reaction (OER) are two crucial reactions. Single-atom catalysts (SACs) based on metal-doped graphene have been widely employed due to their high activity and high atom utilization efficiency. However, the catalytic activity is significantly influenced by different metals and local coordination, making it challenging to efficiently screen through either experimental or density functional theory (DFT) calculations. To address this issue, this study employed a combination of DFT calculations and machine learning (DFT-ML) to investigate rare earth-modified carbon-based (RENxC6-x) electrocatalysts. Based on computational data from 75 catalysts, we trained two ML models to capture the underlying patterns of physical properties and overpotential. Subsequently, the candidate catalysts were screened, leading to the discovery of four ORR catalysts, nine OER catalysts, and five bifunctional electrocatalysts, all of which were thoroughly validated for their stability. Lastly, by integrating the ML models with the SHAP analysis framework, we revealed the influence of atomic radius, Pauling electronegativity, and other features on the catalytic activity. Additionally, we analyzed the physicochemical properties of potential catalysts through DFT calculations. The revolutionary DFT-ML approach provides a crucial driving force for the design and synthesis of potential catalysts in subsequent studies.

Abstract:The steep reduction in costs and systematic optimization of renewable electricity has ignited an intensifying interest in harnessing electroreduction of carbon dioxide (CO2RR) for the generation of chemicals and fuels. The focus of research over the past few decades has been on the optimization of the electrode and the electrolyte environment. Notably, cation species in the latter have recently been found to dramatically alter the selectivity of CO2RR and even their catalytic activity by multiple orders of magnitude. As a result, the selection of cations is a critical factor in designing catalytic interfaces with high selectivity and efficiency for targeted products. Informed decision-making regarding cation selection relies on a comprehensive understanding of prevailing electrolyte effect models that have been used to elucidate observed experimental trends. In this perspective, we review the hypotheses that explain how electrolyte cations influence CO2RR by mechanisms such as through tuning of the interfacial electric field, buffering of the local pH, stabilization of the key intermediates and regulation of the interfacial water. Our endeavor is to elucidate the molecular mechanisms underpinning cation effects, thus fostering the evolution of more holistic and universally applicable predictive models. In this regard, we highlight the current challenges in this area of research, while also identifying potential avenues for future investigations.

Abstract:In view of the climate changes caused by the continuously rising levels of atmospheric CO2 , advanced technologies associated with CO2 conversion are highly desirable. In recent decades, electrochemical reduction of CO2 has been extensively studied since it can reduce CO2 to value-added chemicals and fuels. Considering the sluggish reaction kinetics of the CO2 molecule, efficient and robust electrocatalysts are required to promote this conversion reaction. Here, recent progress and opportunities in inorganic heterogeneous electrocatalysts for CO2 reduction are discussed, from the viewpoint of both experimental and computational aspects. Based on elemental composition, the inorganic catalysts presented here are classified into four groups: metals, transition-metal oxides, transition-metal chalcogenides, and carbon-based materials. However, despite encouraging accomplishments made in this area, substantial advances in CO2 electrolysis are still needed to meet the criteria for practical applications. Therefore, in the last part, several promising strategies, including surface engineering, chemical modification, nanostructured catalysts, and composite materials, are proposed to facilitate the future development of CO2 electroreduction.

Data-driven discovery of electrocatalysts for CO2 reduction using active motifs-based machine learning

Abstract:The electrochemical carbon dioxide reduction reaction (CO2RR) is an attractive approach for mitigating CO2 emissions and generating value-added products. Consequently, discovery of promising CO2RR catalysts has become a crucial task, and machine learning (ML) has been utilized to accelerate catalyst discovery. However, current ML approaches are limited to exploring narrow chemical spaces and provide only fragmentary catalytic activity, even though CO2RR produces various chemicals. Here, by merging pre-developed ML model and a CO2RR selectivity map, we establish high-throughput virtual screening strategy to suggest active and selective catalysts for CO2RR without being limited to a database. Further, this strategy can provide guidance on stoichiometry and morphology of the catalyst to researchers. We predict the activity and selectivity of 465 metallic catalysts toward four expected reaction products. During this process, we discover previously unreported and promising behavior of Cu-Ga and Cu-Pd alloys. These findings are then validated through experimental methods.

Based on ML predictions, the overpotential of PdPt@Cu is successfully predicted to be 0.11 V, and it shows the best electrocatalytic performance for the CO2 reduction reaction (CO2RR). Abstract:Electrocatalytic reduction of carbon dioxide (CO2) is one of the most promising technologies available to mitigate environmental problems introduced by the continuous increase in its concentration that has occurred since the industrial revolution. This technology also is attractive from the viewpoint that it can be based on carbon-neutral energy by converting CO2 into fuels and value-added chemicals using solar or other forms of renewable energy. In this review, fundamental concepts related to electrocatalysis, the electrical double layer, physical and chemical properties of CO2, the interaction of CO2 with electrode surfaces, and the sources of carbon and proton that underpin this technology are provided. Insights into recent mechanisms proposed for the electrocatalytic reduction of CO2 also are provided along with a survey of progress in the rational design of new electrocatalysts. Discussion on achievements in the field is focused on the variation in products formed by different electrocatalysts and the design strategies that have been introduced to alter the electronic and geometric properties of the electrocatalysts. Finally, recommendations for achieving further advances in electrocatalytic reduction of CO2 in a systematic manner are presented.

Abstract:The conversion and utilization of carbon dioxide (CO2) have dual significance for reducing carbon emissions and solving energy demand. Catalytic reduction of CO2 is a promising way to convert and utilize CO2. However, high-performance catalysts with excellent catalytic activity, selectivity and stability are currently lacking. High-throughput methods offer an effective way to screen high-performance CO2 reduction catalysts. Here, recent advances in high-throughput screening of electrocatalysts for CO2 reduction are reviewed. First, the mechanism of CO2 reduction reaction by electrocatalysis and potential catalyst candidates are introduced. Second, high-throughput computational methods developed to accelerate catalyst screening are presented, such as density functional theory and machine learning. Then, high-throughput experimental methods are outlined, including experimental design, high-throughput synthesis, in situ characterization and high-throughput testing. Finally, future directions of high-throughput screening of CO2 reduction electrocatalysts are outlooked. This review will be a valuable reference for future research on high-throughput screening of CO2 electrocatalysts.

Abstract:Advancing the design of cathode catalysts to significantly maximize platinum utilization and augment the longevity has emerged as a formidable challenge in the field of fuel cells. Herein, we rationally design a high entropy intermetallic compound (HEIC, Pt(FeCoNiCu)3) for catalyzing oxygen reduction reaction (ORR) by an efficient machine learning stategy, where crystal graph convolutional neural networks are employed to expedite the multicomponent design. Based on a dataset generated from first-principles calculations, the model can achieve a high prediction accuracy with mean absolute errors of 0.003 for surface strain and 0.011 eV atom-1 for formation energy. In addition, we identify two chemical features (atomic size difference and mixing enthalpy) as new descriptors to explore advanced ORR catalysts. The carbon supported Pt(FeCoNiCu)3 catalyst with small particle size is successfully synthesized by a freeze-drying-annealing technology, and exhibits ultrahigh mass activity (4.09 A mgPt-1) and specific activity (7.92 mA cm-2). Meanwhile, The catalyst also shows significantly enhanced electrochemical stability which can be ascribed to the sluggish difussion effect in the HEIC structure. Beyond offering a promising low-Pt electrocatalysts for fuel cell cathode, this work offers a new paradigm to rationally design advanced catalysts for energy storage and conversion devices.

Abstract:Electrocatalysis has emerged as one of the most promising alternatives to conventional anthraquinone for preparing hydrogen peroxide (H 2 O 2 ) with high energy consumption and pollution because of its simplicity, convenience, and environmental friendliness. However, the oxygen reduction reaction (ORR) generating H 2 O 2 via the 2e - path is a competitive path for 4e – ORR to generate H 2 O. Therefore, it is crucial to identify an electrocatalyst with high selectivity and activity of 2e - ORR. Here, we established five machine learning (ML) models based on the adsorption free energy of O* (△G (O*)) of 149 single-atom catalysts (SACs) collected and the limiting potential (U L ) of 31 SACs calculated using density functional theory (DFT) from the literature. We then obtained descriptors that could accurately describe SACs. Furthermore, 690 unknown SACs' 2e - ORR catalytic performance was well predicted. Four 2e - ORR materials with high selectivity and activity were screened: Pc -N 3 C 1 , 4 , 1 C 3 , and 3 C 1 . We verified the U L of these SACs through DFT calculation, which was higher than the standard value, proving the ML model's validity. The ML-based method to predict the material properties with highly selective and active electrocatalysts provides an efficient, rapid, and low-cost method for discovering and designing more valuable SACs catalysts.
