Improving Land Surface Phenology Extraction Through Space-Aware Neural Networks

Abstract:This study presents a novel approach to extract phenology, the timing of plant life cycles such as flowering and crop harvests, from time series of satellite images. Unlike traditional per-pixel models that neglect spatial relationships and are sensitive to missing or noisy data in input time series, our method simultaneously addresses two types of uncertainty: errors in measuring vegetation greenness at the individual pixel level and inconsistencies between nearby pixels. Our approach combines the double logistic model, which represents the plant greenness cycle with a curve that has an increasing segment followed by a decreasing segment, with the technique of spatial regularization, which accounts for distributions of phenology across areas. The techniques were implemented using neural networks, which can represent complex processes and constraints as interconnected nodes or “neurons”, forming the backbone of recent breakthroughs in artificial intelligence due to its adaptability and learning capabilities. We evaluated our approach in two scenarios: crop harvest in Northeast China using Sentinel-2 images and PhenoCam sites worldwide using Landsat data. Our proposed method outperforms traditional per-pixel curve fitting approaches in terms of fitting error and spatial consistency, and exhibits excellent agreement with the spatial distribution of phenological metrics across various land cover types. This framework has significant potential for addressing the broader challenge of ensuring spatial consistency for per-pixel models.
