Abstract:Computing strongly connected components (SCC) is a fundamental problems in graph processing. As today's real-world graphs are getting larger and larger, parallel SCC is increasingly important. SCC is challenging in the parallel setting and is particularly hard on large-diameter graphs. Many existing parallel SCC implementations can be even slower than Tarjan's sequential algorithm on large-diameter graphs. To tackle this challenge, we propose an efficient parallel SCC implementation using a new parallel reachability algorithm. Our solution is based on a novel idea referred to as vertical granularity control (VGC). It breaks the synchronization barriers to increase parallelism and hide scheduling overhead. To use VGC in our SCC algorithm, we also design an efficient data structure called the \emph{parallel hash bag}. It uses parallel dynamic resizing to avoid redundant work in maintaining frontiers (vertices processed in a round). We implement the parallel SCC algorithm by Blelloch et al.\ (J.\ ACM, 2020) using our new parallel reachability algorithm. We compare our implementation to the state-of-the-art systems, including GBBS, iSpan, Multi-step, and our highly optimized Tarjan's (sequential) algorithm, on 18 graphs, including social, web, $k$-NN, and lattice graphs. On a machine with 96 cores, our implementation is the fastest on 16 out of 18 graphs. On average (geometric means) over all graphs, our SCC is 6.0$\times$ faster than the best previous parallel code (GBBS), 12.8$\times$ faster than Tarjan's sequential algorithms, and 2.7$\times$ faster than the \emph{best existing implementation on each graph}. We believe that our techniques are of independent interest. We also apply our parallel hash bag and VGC scheme to other graph problems, including connectivity and least-element lists (LE-lists).

Fully Dynamic Strongly Connected Components in Planar Digraphs

Abstract:In this paper, we consider maintaining strongly connected components (SCCs) of a directed planar graph subject to edge insertions and deletions. We show a data structure maintaining an implicit representation of the SCCs within $\tilde{O}(n^{6/7})$ worst-case time per update. The data structure supports, in $O(\log^2{n})$ time, reporting vertices of any specified SCC (with constant overhead per reported vertex) and aggregating vertex information (e.g., computing the maximum label) over all the vertices of that SCC. Furthermore, it can maintain global information about the structure of SCCs, such as the number of SCCs or the size of the largest SCC. To the best of our knowledge, no fully dynamic SCCs data structures with sublinear update time have been previously known for any major subclass of digraphs. Our result should be contrasted with the known $n^{1-o(1)}$ amortized update time lower bound conditional on SETH, which holds even for dynamically maintaining whether a general digraph has more than two SCCs.

Abstract:Granular computing (GrC) is a methodology for reducing the complexity of problem solving and includes two basic aspects: granulation and granular-based computing. Strongly connected components (SCCs) are a significant subgraph structure in digraphs. In this paper, two new granulation strategies were devised to improve the efficiency of computing SCCs. Firstly, four SCC correlations between the vertices were found, which can be divided into two classes. Secondly, two granulation strategies were designed based on correlations between two classes of SCCs. Thirdly, according to the characteristics of the granulation results, the parallelization of computing SCCs was realized. Finally, a parallel algorithm based on granulation strategy for computing SCCs of simple digraphs named GPSCC was proposed. Experimental results show that GPSCC performs with higher computational efficiency than algorithms.

Abstract:Edge-coloured directed graphs provide an essential structure for modelling and analysis of complex systems arising in many scientific disciplines (e.g. feature-oriented systems, gene regulatory networks, etc.). One of the fundamental problems for edge-coloured graphs is the detection of strongly connected components, or SCCs. The size of edge-coloured graphs appearing in practice can be enormous both in the number of vertices and colours. The large number of vertices prevents us from analysing such graphs using explicit SCC detection algorithms, such as Tarjan's, which motivates the use of a symbolic approach. However, the large number of colours also renders existing symbolic SCC detection algorithms impractical. This paper proposes a novel algorithm that symbolically computes all the monochromatic strongly connected components of an edge-coloured graph. In the worst case, the algorithm performs $O(p \cdot n \cdot log~n)$ symbolic steps, where $p$ is the number of colours and $n$ is the number of vertices. We evaluate the algorithm using an experimental implementation based on binary decision diagrams (BDDs). Specifically, we use our implementation to explore the SCCs of a large collection of coloured graphs (up to $2^{48}$) obtained from Boolean networks -- a modelling framework commonly appearing in systems biology.

Abstract:We study distributed composite optimization over networks: agents minimize a sum of smooth (strongly) convex functions-the agents' sum-utility-plus a nonsmooth (extended-valued) convex one. We propose a general unified algorithmic framework for such a class of problems, whose unified convergence analysis leverages the theory of operator splitting. Distinguishing features of our scheme are: (i) When the agents' functions are strongly convex, the algorithm converges at a linear rate, whose dependence on the agents' functions and network topology is decoupled, matching the typical rates of centralized optimization; the rate expression improves on existing results; (ii) When the objective function is convex (but not strongly convex), similar separation as in (i) is established for the coefficient of the proved sublinear rate; and (iii) A byproduct of our analysis is a tuning recommendation for several existing (non-accelerated) distributed algorithms yielding the fastest provable (worst-case) convergence rate. This is the first time that a general distributed algorithmic framework applicable to composite optimization enjoys all such properties.

Abstract:Directed graphs are prevalent in social networks, web networks, and communication networks. A well-known concept of the directed graph is the D-core, or ( k, l )-core, which is the maximal subgraph in which each vertex has an in-degree not less than k and an out-degree not less than l. Computing the non-empty D-cores for all possible values of k and l , a.k.a. D-core decomposition, has found versatile applications spanning social network analysis, community search, and graph visualization. However, existing algorithms of D-core decomposition suffer from efficiency and scalability issues on large graphs, because serial peeling-based algorithms are limited by single-core utilization, while skyline coreness-based methods exhibit notably high time complexity. To tackle these issues, in this paper, we propose efficient parallel algorithms for D-core decomposition by leveraging the computational prowess of multicore CPUs. Specifically, we first propose a novel algorithm that computes the D-cores for each possible k value, by exploiting an implicit level-by-level vertex removal strategy, which not only diminishes dependencies between vertices but also maintains a time complexity akin to that of sequential algorithms. We further develop an advanced algorithm by introducing a novel concept of D-shell, which allows us to curtail redundant computations by reducing the necessary k values when computing corresponding D-cores, and deriving D-cores with larger k values from the D-cores currently computed based on D-shell. Extensive experiments on ten real-world large graphs show that our algorithms are highly efficient and scalable, and the advanced algorithm is up to two orders of magnitude faster than the state-of-the-art parallel decomposition algorithm with 32 threads.

FastSV: A Distributed-Memory Connected Component Algorithm with Fast Convergence.

Abstract:This paper presents a new distributed-memory algorithm called FastSV for finding connected components in an undirected graph. Our algorithm simplifies the classic Shiloach-Vishkin algorithm and employs several novel and efficient hooking strategies for faster convergence. We map different steps of FastSV to linear algebraic operations and implement them with the help of scalable graph libraries. FastSV uses sparse operations to avoid redundant work and optimized MPI communication to avoid bottlenecks. The resultant algorithm shows high-performance and scalability as it can find the connected components of a hyperlink graph with over 134B edges in 30 seconds using 262K cores on a Cray XC40 supercomputer. FastSV outperforms the state-of-the-art algorithm by an average speedup of 2.21x (max 4.27x) on a variety of real-world graphs.
Efficient Maximum Clique Computation over Large Sparse Graphs

Abstract:This paper studies the problem of MCC-Sparse, Maximum Clique Computation over large real-world graphs that are usually Sparse. In the literature, MCC-Sparse has been studied separately and less extensively than its dense counterpart MCC-Dense, and advanced algorithmic techniques that are developed for MCC-Dense have not been utilized in the existing MCC-Sparse solvers. In this paper, we design an algorithm MC-BRB which transforms an instance of MCC-Sparse to instances of k-clique finding over dense subgraphs (KCF-Dense) that can be computed by the existing MCC-Dense solvers. To further improve the efficiency, we then develop a new branch-reduce-&-bound framework for KCF-Dense by proposing light-weight reducing techniques and leveraging the existing advanced branching and bounding techniques of MCC-Dense solvers. In addition, we also design an ego-centric algorithm MC-EGO for heuristically computing a near-maximum clique in near-linear time. We conduct extensive empirical studies on large real graphs and demonstrate the efficiency and effectiveness of our techniques.

Distributed Algorithms for Connectivity and MST in Large Graphs with Efficient Local Computation

Abstract:We study distributed algorithms for large-scale graphs, focusing on the fundamental problems of connectivity and minimum spanning tree (MST). We consider the k-machine model, a well-studied model for distributed computing for large-scale graph computations, where k ≥ 2 machines jointly perform computations on graphs with n nodes (typically, n ≫ k). The input graph is assumed to be initially randomly partitioned among the k machines, a common implementation in many real-world systems. Communication is point-to-point, and the goal is to minimize the number of communication rounds (denoted Tc) of the computation. While communication is a significant factor that affects the time needed for large-scale computations, the computation cost incurred by the individual machines also contributes to the overall time complexity of the distributed algorithm. We posit a complexity measure called the local computation cost (denoted Tℓ) that measures the worst-case local computation cost among the machines. A lower bound for Tℓ in our model is Ω((m + n)/k + Δ + k), while a lower bound on Tc is Ω(n/k2) [Klauck et al., SODA 2015], where m is the number of edges and Δ is the maximum degree. Prior algorithms for connectivity and MST in the k-machine model [Klauck et al., SODA 2015, Pandurangan et al., SPAA 2016] do not take into account local computation; a straightforward local implementation of these algorithms is not optimal with respect to local computation. In this paper, we study several distributed algorithms for connectivity and MST and analyze their performance with respect to both the computation and communication cost. In particular, we analyze a well-studied flooding algorithm for connectivity and connected components that takes rounds and local computation time.1 We then present a deterministic filtering algorithm that has an improved round complexity of but local computation complexity of . Next, we present two deterministic algorithms which are increasingly sophisticated implementations of the classical Borůvka’s algorithm, the last of which has round complexity and local computation complexity . We finally present a randomized algorithm to find connected components with round complexity and local computation complexity that are both essentially optimal (up to polylogarithmic factors).
Fast Similar Subgraph Search with Maximum Common Connected Subgraph Constraints

Abstract:Similar sub graph search has attracted considerable attention recently with the widespread usage of graph data. Existing methods used graph edit distance or Maximum Common Sub graph (MCS) to quantify graph similarity. However they either are very expensive to compute the results or involve many meaningless disconnected sub graph structures. To address these limitations, in this paper we study the similar sub graph search problem with Maximum Common Connected Sub graph (MCCS) constraints, which not only generates high-quality results but also efficiently identifies the results. To achieve our goal, we propose the concept of edge matching and develop two efficient filters to effectively prune dissimilar graphs. We combine the backtracking algorithm of calculating MCCS with the edge matching and then embed them into our method. Experimental results show that our method performs well on both real and synthetic datasets.
Reducing Communication in Parallel Breadth-First Search on Distributed Memory Systems

Abstract:Breadth-first search (BFS) is a key operation in data-intensive graph analysis applications. However, for distributed BFS algorithm on large distributed memory systems, data communication often limits the scalability of the algorithm as it costs significantly more than arithmetic computation. In this work, we try to reduce the communication cost in distributed BFS by sieving and compressing the messages. First, we propose a novel distributed directory to sieve the redundant data in collective communications. Then we leverage a bitmap compression algorithm to further reduce the size of messages in communication. Experiments on a 6,144-core Intel West mere based cluster show our algorithm achieve a BFS performance rate of 12.1 billion edge visits per second on an undirected graph of 8 billion vertices and 128 billion edges with scale-free distribution. Compared to the "replicated-csr" version BFS in Graph500, our algorithm reduces communication cost by 79.0% and gets a speedup of 2.2×.

Abstract:Edge-centric distributed computations have appeared as a recent technique to improve the shortcomings of think-like-a-vertex algorithms on large scale-free networks. In order to increase parallelism on this model, edge partitioning - partitioning edges into roughly equally sized blocks - has emerged as an alternative to traditional (node-based) graph partitioning. In this work, we give a distributed memory parallel algorithm to compute high-quality edge partitions in a scalable way. Our algorithm scales to networks with billions of edges, and runs efficiently on thousands of PEs. Our technique is based on a fast parallelization of split graph construction and a use of advanced node partitioning algorithms. Our extensive experiments show that our algorithm has high quality on large real-world networks and large hyperbolic random graphs, which have a power law degree distribution and are therefore specifically targeted by edge partitioning

Abstract:ABSTRACT A knowledge graph (KG) represents a set of entities and their relations. To explore the content of a large and complex KG, a convenient way is keyword-based querying. Traditional methods assign small weights to salient entities or relations, and answer an exploratory keyword query by computing a group Steiner tree (GST), which is a minimum-weight subgraph that connects all the keywords in the query. Recent studies have suggested improving the semantic cohesiveness of a query answer by minimizing the pairwise semantic distances between the entities in a subgraph, but it remains unclear how to efficiently compute such a semantically cohesive subgraph. In this paper, we formulate it as a quadratic group Steiner tree problem (QGSTP) by extending the classical minimum-weight GST problem which is NP-hard. We design two approximation algorithms for QGSTP and prove their approximation ratios. Furthermore, to improve their practical performance, we present heuristics including pruning and ranking strategies.

Abstract:Edge intelligence enables edge devices to collaboratively perform computations and generate knowledge where distributed computations act as the main innovative technologies. The existing solutions for distributed computations mainly focus on the designs of computations, such as distributed machine learning algorithms. By contrast, edge intelligence poses the design requirements for efficient networking technology, including one request multiple reply in a time Interval (ORMRI), computation aggregation, and chained computation, which have not been well addressed. To satisfy those requirements, we design a Computation-Oriented Network (CON) to enable the efficient discovery, task allocation, and collaborative computations for edge devices in this article. In CON, model and datasets are afforded with the names for direct resource discovery, and a hybrid computation oriented routing (HCOR) mechanism has been proposed, which combines proactive and reactive routing approaches. Through CON, computation requests and replies can be sent to and collected from multiple suitable edge devices, respectively; computation aggregation is enabled during the computation result replying process; and chained computation is supported through sequentially popping out model names. We examine the performance of CON through analysis and implementation, which shows that the proposed CON can greatly reduce the communication bandwidth consumption compared to the existing end-to-end approach.
Faster Streaming and Scalable Algorithms for Finding Directed Dense Subgraphs in Large Graphs

Abstract:Finding dense subgraphs is a fundamental algorithmic tool in data mining, community detection, and clustering. In this problem, one aims to find an induced subgraph whose edge-to-vertex ratio is maximized. We study the directed case of this question in the context of semi-streaming and massively parallel algorithms. In particular, we show that it is possible to find a $(2+\epsilon)$ approximation on randomized streams even in a single pass by using $O(n \cdot {\rm poly} \log n)$ memory on $n$-vertex graphs. Our result improves over prior works, which were designed for arbitrary-ordered streams: the algorithm by Bahmani et al. (VLDB 2012) which uses $O(\log n)$ passes, and the work by Esfandiari et al. (2015) which makes one pass but uses $O(n^{3/2})$ memory. Moreover, our techniques extend to the Massively Parallel Computation model yielding $O(1)$ rounds in the super-linear and $O(\sqrt{\log n})$ rounds in the nearly-linear memory regime. This constitutes a quadratic improvement over state-of-the-art bounds by Bahmani et al. (VLDB 2012 and WAW 2014), which require $O(\log n)$ rounds even in the super-linear memory regime. Finally, we empirically evaluate our single-pass semi-streaming algorithm on $6$ benchmarks and show that, even on non-randomly ordered streams, the quality of its output is essentially the same as that of Bahmani et al. (VLDB 2012) while it is $2$ times faster on large graphs.

Effective and Efficient Steiner Maximum Path-Connected Subgraph Search in Large Social Internet of Things

Abstract:Social Internet of Things (SIoT) is extended to integrate social networks in the Internet of Things (IoT). SIoT enriches IoT, and thus resource (or service) discovery and consolidation in SIoT becomes an important and challenging problem. In this paper, we represent the SIoT as the heterogeneous information networks (HINs) with multi-typed entities and relations, and resolve this problem from the perspective of cohesive subgraph search. Specifically, given a query node $q$ , we discover a cohesive subgraph containing $q$ from a HIN, where all nodes are of the same type as $q$ and have dense relationships. Yet existing solutions cannot be applied to various HINs, and the result subgraph is not accurate and close enough due to ignoring the connectivity among nodes within the subgraph. To this end, 1) we extend the connectivity with novel meta-path-based edge-disjoint paths to HINs, and propose the $k$ -path connected component ( $k$ -PCC) to measure the cohesiveness of subgraph in HINs; 2) we model the densest connected subgraph containing $q$ as the $k$ -PCC with the maximum connectivity including $q$ , called the Steiner Maximum Path-Connected Subgraph (SMPCS); 3) we develop efficient algorithms based on an index tree for searching the SMPCS. Extensive experiments on four real HINs are conducted to demonstrate the effectiveness and efficiency of our proposed approaches.

Abstract:The extended 9-intersection matrix is used to formalize topological relations between uncertain regions while it is designed to satisfy the requirements at a concept level, and to deal with the complex regions with broad boundaries (CBBRs) as a whole without considering their hierarchical structures. In contrast to simple regions with broad boundaries, CBBRs have complex hierarchical structures. Therefore, it is necessary to take into account the complex hierarchical structure and to represent the topological relations between all regions in CBBRs as a relation matrix, rather than using the extended 9-intersection matrix to determine topological relations. In this study, a tree model is first used to represent the intrinsic configuration of CBBRs hierarchically. Then, the reasoning tables are presented for deriving topological relations between child, parent and sibling regions from the relations between two given regions in CBBRs. Finally, based on the reasoning, efficient methods are proposed to compute and derive the topological relation matrix. The proposed methods can be incorporated into spatial databases to facilitate geometric-oriented applications.

Abstract:The ability to handle large scale graph data is crucial to an increasing number of applications. Much work has been dedicated to supporting basic graph operations such as subgraph matching, reachability, regular expression matching, etc. In many cases, graph indices are employed to speed up query processing. Typically, most indices require either super-linear indexing time or super-linear indexing space. Unfortunately, for very large graphs, super-linear approaches are almost always infeasible. In this paper, we study the problem of subgraph matching on billion-node graphs. We present a novel algorithm that supports efficient subgraph matching for graphs deployed on a distributed memory store. Instead of relying on super-linear indices, we use efficient graph exploration and massive parallel computing for query processing. Our experimental results demonstrate the feasibility of performing subgraph matching on web-scale graph data.
