Abstract:In this letter, the problem of sparse signal reconstruction from quantized noisy magnitudes y = Q(vertical bar z + w vertical bar + n) is studied, where z = Ax, Q(.) denotes a quantizer, and x is the sparse signal. According to expectation propagation, the above-mentioned problem can be solved by exchanging extrinsic information between the standard linear model (SLM) module and the minimum mean square error (MMSE) module. For the MMSE module, exploiting the fact that the likelihood is only a function of the absolute value of z, the magnitude and phase information of z are decoupled, and only the posterior means and variances of the magnitude of z are calculated. While for the SLM module, the approximate message passing (AMP) is used. To obtain the closed-form expression during the iteration, a novel approximation is adopted. We refer to the resulting algorithm as generalized AMP (Gr-AMP) based quantized phase retrieval algorithm. Finally, several numerical simulations are conducted to demonstrate the performances of the proposed approach.

Abstract:In this paper, we study the performance guarantee of weighted ℓ 1 -constrained quadratic programming in recovering the support of a sparse signal from a few linear measurements. A new sufficient condition for the success of weighted ℓ 1 -constrained quadratic programming is derived. Further, we demonstrate its applications in two typical weighted ℓ 1 models: Firstly, a theoretical result on the modified-BPDN can be generated directly, which indicates that if a partial support information is available and more than half of the information is accurate, then modified-BPDN relaxes the sufficient condition of BPDN ensuring the support recovery for any sparse signals. Secondly, the proposed condition offers a criterion to compute the optimal weights of weighted ℓ 1 minimization for nonuniform sparse models. Some simulations are carried out to validate its effectiveness.

Abstract:In the context of compressed sensing, the nonconvex l(q) minimization with 0 < q < 1 has been studied in recent years. In this letter, by generalizing the sharp bound for l(1) minimization of Cai and Zhang, we show that the condition delta((sq+1)k) < 1/root s(q-2)+1 in terms of restricted isometry constant (RIC) can guarantee the exact recovery of k-sparse signals in the noiseless case and the stable recovery of approximately k-sparse signals in the noisy case by l(q) minimization. This result is more general than the sharp bound for l(1) minimization when the order of RIC is greater than 2k and illustrates the fact that a better approximation to l(o) minimization is provided by l(q) minimization than that provided by l(1) minimization.

Abstract:In this paper, we discuss the statistical properties of the ℓ_qoptimization methods (0<q≤ 1), including the ℓ_q minimization methodand the ℓ_q regularization method, for estimating a sparse parameter fromnoisy observations in high-dimensional linear regression with either adeterministic or random design. For this purpose, we introduce a generalq-restricted eigenvalue condition (REC) and provide its sufficient conditionsin terms of several widely-used regularity conditions such as sparse eigenvaluecondition, restricted isometry property, and mutual incoherence property. Byvirtue of the q-REC, we exhibit the stable recovery property of the ℓ_qoptimization methods for either deterministic or random designs by showing thatthe ℓ_2 recovery bound O(ϵ^2) for the ℓ_q minimizationmethod and the oracle inequality and ℓ_2 recovery boundO(λ^2/2-qs) for the ℓ_q regularization method holdrespectively with high probability. The results in this paper are nonasymptoticand only assume the weak q-REC. The preliminary numerical results verify theestablished statistical property and demonstrate the advantages of the ℓ_qregularization method over some existing sparse optimization methods.

Abstract:We consider efficient methods for the recovery of block sparse signals from underdetermined system of linear equations. We show that if the measurement matrix satisfies the block RIP with δ 2 s < 0.4931, then every block s-sparse signal can be recovered through the proposed mixed l 2/l 1-minimization approach in the noiseless case and is stably recovered in the presence of noise and mismodeling error. This improves the result of Eldar and Mishali (in IEEE Trans. Inform. Theory 55: 5302–5316, 2009). We also give another sufficient condition on block RIP for such recovery method: δ s < 0.307.

Abstract:This paper discusses the reconstruction of signals from few measurements in the situation that signals are sparse or approximately sparse in terms of a general frame via the l(q)-analysis optimization with 0 < q <= 1. We first introduce a notion of restricted q-isometry property (q-RIP) adapted to a dictionary, which is a natural extension of the standard q-RIP, and establish a generalized q-RIP condition for approximate reconstruction of signals via the l(q)-analysis optimization. We then determine how many random Gaussian measurements are needed for the condition to hold with high probability. The resulting sufficient condition is met by fewer measurements for smaller q than when q = 1. The introduced generalized q-RIP is also useful in compressed data separation. In compressed data separation, one considers the problem of reconstruction of signals' distinct subcomponents, which are (approximately) sparse in morphologically different dictionaries, from few measurements. With the notion of generalized q-RIP, we show that under a usual assumption that the dictionaries satisfy a mutual coherence condition, the l(q) split analysis with 0 < q <= 1 can approximately reconstruct the distinct components from fewer random Gaussian measurements with smaller q than when q = 1.
An Iteratively Reweighted Method For Recovery Of Block-Sparse Signal With Unknown Block Partition

Abstract:In this paper, a new iteratively reweighted least squares method is proposed for recovery of block-sparse signals with unknown cluster patterns. In many practical applications, sparse signals have block-sparse structures with nonzero coefficients occurring in clusters, while the prior information of the cluster pattern is usually unavailable. To address this issue, we propose an element-overlapping log-sum functional to encourage the sparseness and the cluster pattern simultaneously. The algorithm is developed by iteratively minimizing a convex surrogate function that majorizes the original objective function, which results in an iteratively reweighted process that alternates between estimating the sparse signal and refining the weights of the surrogate function. Convergence of the iterations to a local minimum of the penalty function is also guaranteed. Numerical results are provided to illustrate the effectiveness of the proposed method.

Abstract:Compressed sensing (CS) states that a sparse signal can exactly be recovered from very few linear measurements. While in many applications, real-world signals also exhibit additional structures aside from standard sparsity. The typical example is the so-called block-sparse signals whose non-zero coefficients occur in a few blocks. In this article, we investigate the mixed l 2 / l q (0 < q ≤ 1) norm minimization method for the exact and robust recovery of such block-sparse signals. We mainly show that the non-convex l 2 / l q (0 < q < 1) minimization method has stronger sparsity promoting ability than the commonly used l 2 / l 1 minimization method both practically and theoretically. In terms of a block variant of the restricted isometry property of measurement matrix, we present weaker sufficient conditions for exact and robust block-sparse signal recovery than those known for l 2 / l 1 minimization. We also propose an efficient Iteratively Reweighted Least-Squares (IRLS) algorithm for the induced non-convex optimization problem. The obtained weaker conditions and the proposed IRLS algorithm are tested and compared with the mixed l 2 / l 1 minimization method and the standard l q minimization method on a series of noiseless and noisy block-sparse signals. All the comparisons demonstrate the outperformance of the mixed l 2 / l q (0 < q < 1) method for block-sparse signal recovery applications, and meaningfulness in the development of new CS technology.

Both simulations and experiments on real data demonstrate that the proposed algorithm outperforms the ℓ 1 -SVD algorithm, which exploits straightforwardly ℓ 2,1 minimization, for both deterministic basis matrix and random basis matrix.

Abstract:In this paper, a theoretical analysis on the signal recovery is provided by weighted l (1-2) minimization when partial support information is available. We establish a sufficient condition for the weighted l (1-2) minimization, which in absence of prior support information is proved to be much better than the state-of-the-art one. In particular, if at least 50% of the estimated support information is accurate, the sufficient condition is weaker than the analogous one of the standard l (1-2) minimization. In addition, a series of numerical experiments are conducted by the modified DCA-l (1-2) method to support the performance of weighted l (1-2) minimization. The excellent recovery performance of weighted l (1-2) minimization is showed compared with the state-of-the-art weighted l (1) minimization and weighted l ( q )(0 < q < 1) minimization when the measurement matrix is highly coherent.

Abstract:The lower-order penalty optimization methods, including the ℓ _q minimization method and the ℓ _q regularization method (0<q≤ 1) , have been widely applied to find sparse solutions of linear regression problems and gained successful applications in various mathematics and applied science fields. In this paper, we aim to investigate statistical properties of the ℓ _q penalty optimization methods with randomly noisy observations and a deterministic/random design. For this purpose, we introduce a general q -Restricted Eigenvalue Condition (REC) and provide its sufficient conditions in terms of several widely-used regularity conditions such as sparse eigenvalue condition, restricted isometry property, and mutual incoherence property. By virtue of the q -REC, we exhibit the ℓ _2 recovery bounds of order O(ϵ ^2) and O(λ ^2/2-qs) for the ℓ _q minimization method and the ℓ _q regularization method, respectively, with high probability for either deterministic or random designs. The results in this paper are nonasymptotic and only assume the weak q -REC. The preliminary numerical results verify the established statistical properties and demonstrate the advantages of the ℓ _q penalty optimization methods over existing sparse optimization methods.

Abstract:This paper considers the problem of reconstructing sparse signals from one-bit quantized measurements. We employ a log-sum penalty function, also referred to as the Gaussian entropy, to encourage sparsity in the algorithm development. In addition, in the proposed method, the logistic function is introduced to quantify the consistency between the measured one-bit quantized data and the reconstructed signal. Since the logistic function has the tendency to increase the magnitudes of the solution, an explicit unit-norm constraint is no longer necessary to be included in our optimization formulation. An algorithm is developed by iteratively minimizing a convex surrogate function that bounds the original objective function. This leads to an iterative reweighted process that alternates between estimating the sparse signal and refining the weights of the surrogate function. Numerical results are provided to illustrate the effectiveness of the proposed algorithm.

Abstract:This paper introduces a novel approach for recovering sparse signals using sorted L1/L2 minimization. The proposed method assigns higher weights to indices with smaller absolute values and lower weights to larger values, effectively preserving the most significant contributions to the signal while promoting sparsity. We present models for both noise-free and noisy scenarios, and rigorously prove the existence of solutions for each case. To solve these models, we adopt a linearization approach inspired by the difference of convex functions algorithm. Our experimental results demonstrate the superiority of our method over state-of-the-art approaches in sparse signal recovery across various circumstances, particularly in support detection.
