Abstract:We evaluate the performances of various methods for forecasting tourism data. The data used include 366 monthly series, 427 quarterly series and 518 annual series, all supplied to us by either tourism bodies or academics who had used them in previous tourism forecasting studies. The forecasting methods implemented in the competition are univariate and multivariate time series approaches, and econometric models. This forecasting competition differs from previous competitions in several ways: (i) we concentrate on tourism data only; (ii) we include approaches with explanatory variables; (iii) we evaluate the forecast interval coverage as well as the point forecast accuracy; (iv) we observe the effect of temporal aggregation on the forecasting accuracy; and (v) we consider the mean absolute scaled error as an alternative forecasting accuracy measure. We find that pure time series approaches provide more accurate forecasts for tourism data than models with explanatory variables. For seasonal data we implement three fully automated pure time series algorithms that generate accurate point forecasts, and two of these also produce forecast coverage probabilities which are satisfactorily close to the nominal rates. For annual data we find that Naïve forecasts are hard to beat.

Abstract:Tourism forecasting is one of the longest standing areas in tourism economics research, with over half a century of history already. The development of tourism forecasting research responds and contributes to the industry practice. Accurate demand forecasts are the foundation of tourism-related business decisions on pricing and operation strategies, and for governments on infrastructure investment and tourism policymaking. In recent years, tourism forecasting has received more attention from industry practitioners. First, echoing the increasing numbers of international and domestic tourists, the tourism industry has continuously grown and become more dynamic. As a result, industry practitioners have hoped to understand the market and predict future trends more accurately and comprehensively. Second, in recent years, decision makers have realized the increasing importance of quantitative evidence and have become more likely to rely on or refer to it for their strategy and policy formulations. Finally, the development of big data based on Internet technology has made it possible for the industry to obtain more accurate forecasts. Data on online tourist behaviour can be traced and retrieved. With greater understanding of it, the industry can then use it to forecast future trends.

Abstract:This study provides innovative forecasts of the probabilities of certain scenarios of tourism demand. The scenarios of interest are constructed in relation to tourism growth and economic growth. The probability forecasts based on these scenarios provide valuable information for destination policy makers. The time-varying parameter panel vector autoregressive (TVP-PVAR) model is adopted for scenario forecasting. Both the accuracy rate and the Brier score are used to evaluate the forecasting performance. A global set of 25 tourism destinations is empirically examined, and the results confirm that the TVP-PVAR model with a time-varying error covariance matrix is generally a promising tool for forecasting. Our study contributes to tourism forecasting literature in advocating the use of scenario forecasting to facilitate industry decision making in situations wherein forecasts are defined by two or more dimensions simultaneously. In addition, it is the first study to introduce the TVP-PVAR model to tourism demand forecasting.

Abstract:The performance of forecast combination techniques is explored at different time horizons in the context of tourism demand forecasting. Statistical comparisons between the combination and single-model forecasts show that the combined forecasts are significantly more accurate than the average single-model forecasts across all forecasting horizons and for all combination methods. This provides a strong recommendation for forecast combination in tourism. In addition, the empirical results indicate that forecast accuracy does not improve as the number of models included in the combination forecasts increases. It also appears that combining forecasts may be more beneficial for longer-term forecasting.

Abstract:Decomposition methods are extensively used for processing the complex patterns of tourism demand data. Given tourism demand data’s intrinsic complexity, it is critical to theoretically understand how different decomposition methods provide solutions. However, a comprehensive comparison of decomposition methods in tourism demand forecasting is still lacking. Hence, this study systematically investigates the forecasting performance of decomposition methods in tourism demand. Nine popular decomposition methods and six forecasting methods are employed, and their forecasting performance is compared. With Hong Kong visitor arrivals from eight major sources as a sample, three main conclusions are obtained from empirical results. First, all the decomposition methods generally outperform benchmark at all horizons, in both the level and directional forecasting. Second, decomposition methods can be divided into four categories based on forecasting accuracy. Finally, variational mode decomposition method is consistently superior to other eight decomposition methods and can provide the best forecasts in all cases.

Abstract:Empirical research has shown that incorporating big data into tourism and hospitality forecasting significantly improves prediction accuracy. This study presents a comprehensive review of big data forecasting in the tourism and hospitality industry, critically evaluating existing research and identifying five key research questions and trends that require further attention. These include the lack of theoretical foundation, the rise of high-frequency forecasting research, less attention to unstructured data, the necessity of dynamic data analysis in forecasting, and the construction of a tourism and hospitality demand information system based on cloud computing. Importantly, this study constructs a theoretical framework by combining relevant theories from psychology, communication, information processing, and other fields. Five types of big data used for tourism and hospitality forecasting are identified: web-based volume data, social media statistics, textual data, photo data, and video data. Additionally, more recent tactics such as mixed data sampling and machine learning methods are discussed.

Abstract:Current research highlights the efficacy of decomposition and ensemble algorithms in enhancing forecasting accuracy; however, the investigation of robustness associated with decomposed components within these algorithms remains notably scarce in existing literature. To address this gap, we introduce a novel tourism demand forecasting framework, underpinned by a sophisticated decomposition algorithm. Our approach initially decomposes the original data into multiple sub-series and subsequently selects forecasting models based on their respective data attributes. We evaluated the proposed framework by forecasting monthly tourist arrivals in Hong Kong from six countries. The superiority of the novel decomposition method was further substantiated through comparisons with alternative decomposition techniques in both single-step and multi-step ahead forecasting contexts. The results indicate that the proposed forecasting framework consistently outperforms baseline models in terms of forecasting accuracy across all tourism demand forecasting scenarios, with the innovative decomposition method exhibiting exceptional performance.

Abstract:Accuracy is particularly important when forecasting tourism demand on account of the perishable nature of the product. The main methods used to forecast tourism demand which are reported in published empirical studies are discussed, together with the empirical findings. The vast majority of such studies are concerned with econometric modelling/forecasting, and the most appropriate explanatory variables are examined. Particular emphasis is placed on empirical comparisons of the accuracy of tourism forecasts generated by different techniques. Considerable scope exists for improving the model specification techniques employed in econometric forecasting of tourism demand. Furthermore, no single forecasting method performs consistently best across different situations, but autoregression, exponential smoothing and econometrics are worthy of consideration as alternatives to the no change model.

Abstract:Tourism demand forecasting is a critical process in the planning of tourism utilities. In recent years, Internet search indices have been popularly used as tourism demand indicators. However, due to the complex relationship between tourism demand and the search index and the vast amounts of search engine data, the traditional econometric and artificial intelligence models could not be enough to complete the prediction task. Under this scenario, this paper proposes a novel two-step method to improve tourism demand prediction accuracy. Firstly, a double-boosting algorithm is proposed to select the keywords and their lags from the potential relevant high-dimensional search queries. Second, the ensemble Support Vector Regression (SVR) based Deep belief Network (DBN) approach is adopted to capture the possible non-linear relationship and to improve the forecasting performance through deep learning combination. The empirical results demonstrate that this procedure significantly outperforms other benchmark models when forecasting monthly Hong Kong tourist arrivals.

Abstract:The tourism literature has shown that a combination of tourism forecasting models can provide better performance than individual models. In the literature, the models to be combined are usually subjectively selected and authors focus on the combination method. In this study, a new direction is represented by the integration of forecasts from several models using a two-stage forecasting system. In stage I, a subset of the best available models is objectively selected according to their performance. Then, in stage II, linear and nonlinear combination methods are utilized to integrate the forecast values of the optimal subset. The empirical study using tourist arrivals in Hong Kong from five major source markets indicates that the proposed two-stage tourism forecasting system with linear combination substantially improves forecasting performance compared with benchmarks. This study also finds that when combining forecasts from different models, the linear combination method is more suitable than nonlinear AI models.

Abstract:Tourism managers and practitioners rely on accurate demand forecasting and well-informed management guidance. Given the pandemic's consequences on tourism, future analysis in the during-epidemic era is urgently needed. This study aims to achieve three goals combining the utilization of decomposition algorithms and deep learning models: 1) to investigate the changes in tourism demand according to seasonal fluctuations of various frequencies, 2) to improve modelling accuracy in tourism demand forecasting during non-crisis periods and in the peri-COVID-19 era, and 3) to analyze tourism demand evolution in the peri-Covid-19 era. The volume of domestic tourism in Hawaii is used as sample data for demonstration and validation. The empirical findings demonstrate that the framework provided in this study has excellent interpretability and forecasting accuracy, surpasses all benchmark models in terms of error calculation and statistical tests and can provide further insights into peri-Covid-19 demand analysis and management.

Abstract:Tourism demand forecasting is proven essential to optimize management, increase revenues, and control risks. Spatial effects have been widely considered in forecasting models and achieved good results. However, existing studies paid little attention to the dynamicity and hierarchy of spatial correlations among tourist attractions within tourism destination complex networks. This study addresses this paucity by proposing a novel deep learning model, namely, multi-hierarchy dynamic spatiotemporal network (MHDSTN). Innovatively, dynamic and hierarchical spatiotemporal features are extracted for forecasting improvement by integrating transformer, gated graph convolution, and long short-term memory. The effectiveness, robustness, and interpretability of the model are demonstrated through an empirical case in Beijing, China. Results indicate that incorporating dynamic and hierarchical spatial effects remarkably improves forecasting accuracy.

Abstract:The tourism industry has been integrated into the national strategic system in China. Thus, tourism demand forecasting has become a concern for the sustainable development of the tourism industry. Unfortunately, the sample size for tourism in China is always small and cannot satisfy the hypothesis test of an economic model or the data volume for a traditional time series model. In this study, a novel hybrid forecasting framework combining fuzzy time series (FTS) and an atom search optimization (ASO) algorithm is proposed for inbound tourism demand forecasting; this forecasting framework is particularly suitable for small sample sizes. Specifically, information optimization technology is applied in the FTS to improve the recognition ability of the system and effectively identify small sample information. The ASO algorithm is applied to search the optimal parameters of FTS that can further improve forecasting performance. All comparison experiments and tests verify the effectiveness and superiority of our proposed model, which provides excellent forecasting results for tourism demand and a basis for policymakers and managers to plan appropriately for the tourism market.

Abstract:The mass withdrawal from the tourism market and the bankruptcy of operators with many years of history show that there have been radical changes in this type of business. The digital economy, the rapid development of online services, aggregator sites change the structure of demand for travel, recreation and entertainment. First of all, it is necessary to take into account that the generation of zets becomes the most active consumer for these services. Since the global network has become the main source of information and a way of interaction for this age group, it is necessary to change the concept of supply. It is necessary to diversify the assortment sales matrix in addition to traditional vouchers. The expansion of the range of tourism products should be based not only on a deep analysis of market demand, but also on modern algorithms for processing large sets of consumer preference data. It is beneficial to take advantage of digital technologies. It is necessary to take into account a combination of two circumstances: on the one hand Internet surfing potential customers of tourist services, on the other the possibility of tour operators purchasing from search portals and sites aggregators of data on leads (lead), landing pages (Landing Page), CTR (Clickthrough Rate) and other tools of Internet marketing statistics. This work is devoted to the development of an algorithm for processing sets of data on consumer preferences and the development of an optimal market strategy for the supply of tourism services in a competitive business environment. Methods of stochastic optimization, mathematical theory of search for solutions in conditions of uncertainty, computer modeling have been used to solve the problem.

Abstract:The global tourism industry is struggling to recover from the COVID-19 pandemic. During the COVID-19 pandemic, daily tourism forecasting is more critical than ever before in supporting decisions and planning. Considering the changes in tourist psyche and behaviour caused by COVID-19, this study attempts to investigate whether the statistical modelling methods can work reliably under the new normal when travel restrictions are eased or lifted. To this end, we first compare the predictivity of daily tourism demand data before and during COVID-19, and observe heterogeneous impacts across different geographical scales. Then an improved multivariate & multiscale decomposition-ensemble framework is proposed to forecast daily tourism demand. The empirical study indicates the superiority and practicability of the proposed framework before and during COVID-19. Finally, we call for more research on the comparability of tourism demand forecasting.

Abstract:Tourism Economics, Ahead of Print. Existing studies on tourism seasonality have been mainly identified at annual or monthly level and the seasonality in tourism demand forecasting has always been addressed by modeling season patterns. However, annual or monthly seasonality is coarse-grained and can't capture the subtle changes emerging both in tourism theory and practice. This study recognizes tourism seasonality based on intra-day patterns and inter-day similarity and suggests a novel approach to addressing seasonality in tourism demand forecasting. The proposed three-step method contains tourism seasonality recognition, tourism seasonality matching, and tourism demand forecasting. The empirical findings, based on two attractions in China, demonstrate that the proposed method based on dynamic time warping and density-peak clustering can precisely capture tourism seasonality at the daily level. The method can also detect special tourism periods or subtle changes in seasonality, such as staggered peak travel phenomenon. Superior forecasting performance with seasonality matching is also revealed. This study sheds new light on tourism seasonality recognition and contributes to forecasting methodology.

Abstract:In a context in which the tourism industry is jeopardised by the COVID-19 pandemic, and potentially by other pandemics in the future, the capacity to produce accurate forecasts is crucial to stakeholders and policy-makers. This paper attempts to forecast the recovery of tourism demand for 2021 in 20 destinations worldwide. An original scenario-based judgemental forecast based on the definition of a Covid-19 Risk Exposure index is proposed to overcome the limitations of traditional forecasting methods. Three scenarios are proposed, and ex ante forecasts are generated for each destination using a baseline forecast, the developed index and a judgemental approach. The limitations and potential developments of this new forecasting model are then discussed.

Abstract:This study aims to forecast international tourist arrivals to Hong Kong from seven English-speaking countries. A new direction in tourism demand modeling and forecasting is presented by incorporating tourist-generated online review data related to tourist attractions, hotels, and shopping markets into the destination forecasting system. The main empirical findings indicate that tourism demand forecasting based on tourists’ online review data can substantially improve the forecasting performance of tourism demand models; specifically, mixed data sampling (MIDAS) models outperformed competing models when high-frequency online review data were included in traditional time-series models.
