Abstract:The development and application of multivariate statistical techniques in process monitoring has gained substantial interest over the past two decades in academia and industry alike. Initially developed for monitoring and fault diagnosis in complex systems, such techniques have been refined and applied in various engineering areas, for example mechanical and manufacturing, chemical, electrical and electronic, and power engineering. The recipe for the tremendous interest in multivariate statistical techniques lies in its simplicity and adaptability for developing monitoring applications. In contrast, competitive model, signal or knowledge based techniques showed their potential only whenever cost-benefit economics have justified the required effort in developing applications.

Abstract:In multivariate statistical process control(MSPC),fault detection,fault identification and fault isolation are challenging problems.An integrated novel MSPC method was proposed by combining multivariate feature extraction with three SVM-based methods commonly used in one-class classifier design,key feature selection and multi-class classifier design,respectively.In this method it was able to calculate control limits of multiple statistics for fault detection simultaneously without conventional theoretical distribution assumptions,and to determine the key variables for fault identification based on both their magnitude changes and their contributions to fault classification in residual space which improves the identification accuracy,and fault isolation was implemented by taking advantage of the wellknown properties of SVM-based multi-class classifier which avoids introducing specific discriminant criteria.Using principal component analysis(PCA) as feature extraction method,the SVM-based MSPC method was demonstrated by application to a benchmark simulator Tennessee Eastman process.The results showed the advantages.

Abstract:Multiscale visualization approaches are proposed to efficiently assist designers not familiar with statistical mathematics in determining the optimal process parameter schemes for achieving desired part quality in injection molding, based on which the parameters’ relative importance to part quality and their influence on either single quality index or comprehensive part quality can be visually described by the map of the sum of squared deviations, response surface diagram and distribution map of comprehensive part quality. The proposed visualization approaches are universal for analyzing the effects of process parameters on the quality of any injection-molded plastic parts although the mobile phone cover is utilized as an example in the presentation of our work.

Abstract:Principal component analysis (PCA) can be effectively used to eliminate system noise and correlation between process variables but to reserve enough original data information. Based on principal component model, performance monitoring and analysis was carried out on control system with multivariate statistical index, such as Q residuals, Hotelling T2 and principal scores. This method with multivariable statistical technologies gives explicit knowledge about control system: whether the system is in-control or out-control, how disturbance and system variables influence the performance and how the control strategy work. Control system then could be evaluated with these knowledges. Application to two typical chemical processes shows the example of the method practical function

Abstract:Multivariate statistical process monitoring and control (MSPMC) methods for chemical process monitoring with statistical projection techniques such as principal component analysis (PCA) and partial least squares (PLS) are surveyed in this paper. The four-step procedure of performing MSPMC for chemical process, modeling of processes, detecting abnormal events or faults, identifying the variable(s) responsible for the faults and diagnosing the source cause for the abnormal behavior, is analyzed. Several main research directions of MSPMC reported in the literature are discussed, such as multi-way principal component analysis (MPCA) for batch process, statistical monitoring and control for nonlinear process, dynamic PCA and dynamic PLS, and on-line quality control by inferential models. Industrial applications of MSPMC to several typical chemical processes, such as chemical reactor, distillation column, polymerization process, petroleum refinery units, are summarized. Finally, some concluding remarks and future considerations are made.

Abstract:Woodall and Montgomery [35] in a discussion paper, state that multivariate process control is one of the most rapidly developing sections of statistical process control. Nowadays, in industry, there are many situations in which the simultaneous monitoring or control, of two or more related quality - process characteristics is necessary. Process monitoring problems in which several related variables are of interest are collectively known as Multivariate Statistical Process Control (MSPC).This article has three parts. In the first part, we discuss in brief the basic procedures for the implementation of multivariate statistical process control via control charting. In the second part we present the most useful procedures for interpreting the out-of-control variable when a control charting procedure gives an out-of-control signal in a multivariate process. Finally, in the third part, we present applications of multivariate statistical process control in the area of industrial process control, informatics, and business.

Abstract:The Tennessee Eastman(TE) process simulating the features of actual complex systems was taken as testing object to analyze the impact of system's control strategies when applying multivariate statistical monitoring methods in complex industrial processes.The similarities and differences between control strategies and the ability of restraining faults were compared under three control strategies including base control,decentralized control and plant-wide control.Fault detection rate was adopted as performance index for monitoring methods.Then the impact of control strategies on monitoring performance was detailedly analyzed in two typical multivariate statistical monitoring methods respectively based on principal component analysis(PCA) and dissimilarity of data.The simulations of 20 faults of TE process indicate that control strategies have significant impact on the monitoring performance,and choosing appropriate modeling variables and model parameters according to the characteristic of control strategies can effectively improve fault detection rate.

Abstract:A new method based on multivariate statistical signal processing was presented for a large number of batch process in modern chemical industry,which divides the process information space into three subspace: subspace described by blind source signals,subspace described by principal components and subspace of residual information.Then corresponding control limits or operating features classifiers were built to monitor the process.The feasibility of this method was investigated by applying it to a batch process,and the results show that this method can:1)not only detect process faults in time,but also confirm the source of faults exactly;2)extract or model process features much more simply in each subspace than in whole process information space and 3)overcome the limitation of the assumption in conventional multivariate statistical process control(MSPC) that the separated latent variables must be subjected to normal probability distribution.

Abstract:Chemical process variables are always driven by random noise and disturbances. The closed-loop control yields process measurements that are auto and cross correlated. The influence of auto and cross correlations on statistical process control (SPC) is investigated in detail by Monte Carlo experiments. It is revealed that in the sense of average performance, the false alarms rates (FAR) of principal component analysis (PCA), dynamic PCA are not affected by the time-series structures of process variables. Nevertheless, non-independent identical distribution will cause the actual FAR to deviate from its theoretic value apparently and result in unexpected consecutive false alarms for normal operating process. Dynamic PCA and ARMA-PCA are demonstrated to be inefficient to remove the influences of auto and cross correlations. Subspace identification-based PCA (SI-PCA) is proposed to improve the monitoring of dynamic processes. Through state space modeling, SI-PCA can remove the auto and cross correlations efficiently and avoid consecutive false alarms. Synthetic Monte Carlo experiments and the application in Tennessee Eastman challenge process illustrate the advantages of the proposed approach.

Abstract:In order to reduce the variations of the product quality in batch processes, multivariate statistical process control methods according to multi-way principal component analysis (MPCA) or multi-way projection to latent structure (MPLS) were proposed for on-line batch process monitoring. However, they are based on the decomposition of relative covariance matrix and strongly affected by outlying observations. In this paper, in view of an efficient projection pursuit algorithm, a robust statistical batch process monitoring (RSBPM) framework, which is resistant to outliers, is proposed to reduce the high demand for modeling data. The construction of robust normal 'operating condition model and robust control limits are discussed in detail. It is evaluated on monitoring an industrial streptomycin fermentation process and compared with the conventional MPCA. The results show that the RSBPM framework is resistant to possible outliers and the robustness is confirmed.

Abstract:This study aims to develop an algorithm by integrating multi-resolution analysis (MRA) and principal curves (PC) for monitoring multivariate processes. This may pave the way for handling nonlinear data by means of principal curves in process monitoring area. We succeed in utilizing PC technique for monitoring without the assistance of neural networks, a traditional tool to deal with nonlinear model in papers, and get ideal results. The methodology proposed is tested with a mathematical example and a simulated benchmark process: the continuous stirred tank reactor (CSTR). The results demonstrate that, compared with traditional principal component analysis (PCA), PC, nonlinear PCA and multiscale PCA, the proposed approach can extract the nonlinearity and decorrelate the autocorrelated measurements effectively and is, hence, suitable for multivariate process monitoring.

Abstract:The work summarized in this paper represents the first part of a two-paper analysis of statistical monitoring of complex dynamic multivariate processes. Motivated by recent research highlighting the difficulties of monitoring autocorrelated variables, this first paper revisits the impact of autocorrelation and cross-correlation upon the significance level for hypothesis testing in monitoring statistics. The presented analysis shows that both correlations lead to profound alterations of the significance level, which can manifest themselves in the production of false alarms or an insensitive monitoring scheme. In the research literature on statistical process monitoring, however, only the issue of autocorrelation has received attention thus far. To improve process monitoring of autocorrelated and cross-correlated variables, this article proposes the use of Kalman innovation models to remove these correlations. The utility of this improvement is demonstrated using an application to the Tennessee Eastman simulator and the analysis of recorded data from an industrial distillation unit.

Abstract:An industrial process often has a large number of measured variables, which are usually driven by fewer essential variables. An improved independent component analysis based on particle swarm optimization (PSO-ICA) is presented to extract these essential variables. Process faults can be detected more efficiently by monitoring the independent components. To monitor the non-Gaussian distributed independent components obtained by PSO-ICA, the one-class SVDD (Support Vector Data Description) is employed to find the separating boundary between the normal operational data and the rest of independent component feature space. The proposed approach is illustrated by the application to the Tennessee Eastman challenging process.

Abstract:Multivariate statistical process control (MSPC) has been applied to performance monitoring for chemical process. However, conventional methods of MSPC are based on the premise that the extracted latent variables must be subjected to normal distribution, which often can't be satisfied. In this paper, a new method based on independent component analysis (ICA) and principal component analysis (PCA) is presented for process performance monitoring, in which a two-step procedure is employed. At first step, process operating information with non-normal distribution is extracted by means of ICA, and the density function of this part of information is estimated by means of parzen density estimator for calculating the confidence limits. At the second step, the information with normal distribution is extracted from the underlying residual data sets by PCA, and the confidence limits are determined on Q and hotelling T2 statistics. With the primary advantage of which no assumption of normal distribution on process data sets is needed, the proposed method is applied to a double-effect evaporator, and the simulation results verify it effective.

Abstract:Statistical process control of multi-attribute count data has received much attention with modern data-acquisition equipment and online computers. The multivariate Poisson distribution is often used to monitor multivariate attributes count data. However, little work has been done so far on under- or over-dispersed multivariate count data, which is common in many industrial processes, with positive or negative correlation. In this study, a Shewhart-type multivariate control chart is constructed to monitor such kind of data, namely the multivariate COM-Poisson (MCP) chart, based on the MCP distribution. The performance of the MCP chart is evaluated by the average run length in simulation. The proposed chart generalizes some existing multivariate attribute charts as its special cases. A real-life bivariate process and a simulated trivariate Poisson process are used to illustrate the application of the MCP chart.
An Approach to Statistical Process Control that is New, Nonparametric, Simple, and Powerful

Abstract:To maintain the desired quality of a product or service it is necessary to monitor the process that results in the product or service. This monitoring method is called Statistical Process Management, or Statistical Process Control. It is in widespread usage in industry. Extensive statistical methodology has been developed to make it possible to detect when a process goes out of control while allowing for natural variability that occurs when the process is in control. This paper introduces nonparametric methods for monitoring data, whether it is univariate or multivariate, and whether the interest is in detecting a change of location or scale or both. These methods, based on sequential normal scores, are much simpler than the most popular nonparametric methods currently in use and have good power for detecting out of control observations. Sixteen new statistical tests are introduced for the first time in this paper, with 17 examples, 33 tables, and 48 figures to complete the instructions for their application.

Abstract:Technological advances led to increasingly larger industrial quality-related datasets calling for process monitoring methods able to handle them. In such context, the application of variable selection (VS) in quality control methods emerges as a promising research topic. This review aims at presenting the current state-of-the-art of the integration of VS in multivariate statistical process control (MSPC) methods. Proposals aligned with the objective were identified, classified according to VS approach, and briefly presented. Research on the topic has considerably increased in the past five years. Thirty methods were identified and categorized in 10 clusters, according to the objective of improvement in MSPC and the step of process monitoring they were aimed to improve. The majority of the propositions were either targeted at exclusively monitoring potential out-of-control variables or improving the monitoring of in-control variables. MSPC improvements were centered in principal component analysis (PCA) projection methods, while VS was mainly carried out using the Least Absolute Shrinkage and Selection Operator (LASSO) method and genetic algorithms. Fault isolation was the most addressed step in process monitoring. We close the paper proposing five topics for future research, exploring the opportunities identified in the literature.

Statistical Process Monitoring of Autocorrelation Data from Multistage Processes

Abstract:An effective multivariate process control charts for auto-correlated data from multistage processes was established,and the formula for calculating its average run length was given by combining state-space models and statistical process control methods.The correctness of the formula was verified by Monte Carlo simulation.Finally,the new method was illustrated with one real example to demonstrate the implementation steps.The results show that in control the chart has low alarm rate,while out of control it has high alarm rate.
