Abstract:In recent years, with the rapid development of mobile applications, user check-in histories have been increasing. Successive point-of-interest (POI) recommendation has gained growing attention. Existing successive point-of-interest recommendation methods learn long- and short-term user preferences through historical check-in sequences to provide more personalized services. However, due to sparse data and complicated temporal patterns, the application of such technique is still limited by two challenges: 1) difficulty meeting user travel needs in time; 2) difficulty capturing users complicated behavior patterns. To address this problem, we propose a new Influence-Aware successive POI recommendation Model (InfAM), which can learn the influence of POIs in a short-term sequence fragment for next point-of-interest recommendation. To capture periodic patterns of user movements, InfAM takes a user's check-in data within a day as an input sequence to address the current travel needs of the user. In addition, based on multihead attention mechanism and user embedding, InfAM focuses on the influence of POIs in short-term sequences and general user preferences in these sequences. Therefore, InfAM integrates three specific dependencies, which can fully learn the dynamic interaction between short-term preferences: the influence of POIs in short-term sequence fragments (POI-poi), user preferences (POI-user), and the periodicity of check-ins (POI-time). Evaluation results on real-world datasets show that InfAM achieves state-of-the-art recommendation performance.
Automated Android Application Permission Recommendation

Abstract:The number of Android applications has increased rapidly as Android is becoming the dominant platform in the smartphone market. Security and privacy are key factors for an Android application to be successful. Android provides a permission mechanism to ensure security and privacy. This permission mechanism requires that developers declare the sensitive resources required by their applications. On installation or during runtime, users are required to agree with the permission request. However, in practice, there are numerous popular permission misuses, despite Android introducing official documents stating how to use these permissions properly. Some data mining techniques (e.g., association rule mining) have been proposed to help better recommend permissions required by an API. In this paper, based on popular techniques used to build recommendation systems, we propose two novel approaches to improve the effectiveness of the prior work. The first approach utilizes a collaborative filtering technique, which is inspired by the intuition that apps that have similar features — inferred from their APIs — usually share similar permissions. The second approach recommends permissions based on a text mining technique that uses a naive Bayes multinomial classification algorithm to build a prediction model by analyzing descriptions of apps. To evaluate these two approaches, we use 936 Android apps from F-Droid, which is a repository of free and open source Android applications. We find that our proposed approaches yield a significant improvement in terms of precision, recall, F1-score, and MAP of the top-k results over the baseline approach.

Abstract:Background: The applying of third-party libraries is an integral part of many applications. But the libraries choosing is time-onsuming even for experienced developers. The automated recommendation system for libraries recommendation is widely researched to help developers to choose libraries. Aim: from software engineering aspect, our research aims to give developers a reliable recommended list of third-arty libraries at the early phase of software development lifecycle to help them build their development environment faster; and from technical aspect, our research aims to build a generalizable recommendation system framework which combines collaborative filtering and topic modeling techniques, in order to improve the performance of libraries recommendation significantly. Our works on this research: 1) we design a hybrid methodology to combine collaborative filtering and LDA text mining technology; 2) we build a recommendation system framework successfully based on the above hybrid methodology; 3) we make a well-designed experiment to validate the methodology and framework which use the data of 1,013 mobile application projects; 4) we do the evaluation for the result of the experiment. Conclusions: 1) hybrid methodology with collaborative filtering and LDA can improve the performance of libraries recommendation significantly; 2) based on the hybrid methodology, the framework works very well on the libraries recommendation for helping developers' libraries choosing. Further research is necessary to improve the performance of the libraries recommendation including: 1) use more accurate NLP technologies improve the correlation analysis; 2) try other similarity calculation methodology for collaborative filtering to rise the accuracy; 3) on this research, we just bring the time-series approach to the framework and make an experiment as comparative trial, the result shows that the performance improves continuously, so in further research we plan to use time-series data-mining as the basic methodology to update the framework.

Abstract:Nowadays, the number of mobile applications (Apps) is rapidly increasing due to different kinds of user needs. Existing App recommendation models can not scale to practical large data scenarios. In this paper, we present a large scale App recommendation framework, which has been applied into real application in Ant Financial for recommending Apps for hundreds of millions of users. We first present feature engineering, including a novel way to high-level features, and then use a linear ranking model to make recommendation. We also report the encouraging results through the experiments in real large scale dataset.

Abstract:Mobile devices are becoming ubiquitous. People use their phones as a personal concierge discovering and making decisions anywhere and anytime. Understanding user intent on the go therefore becomes important for task completion on the phone. While existing efforts have predominantly focused on understanding the explicit user intent expressed by a textual or voice query, this paper presents an approach to context-aware and personalized entity recommendation which understands the implicit intent without any explicit user input on the phone. The approach, highly motivated from a large-scale mobile click-through analysis, is able to rank both the entity types and the entities within each type (here an entity is a local business, e.g., "I love sushi," while an entity type is a category, e.g., "restaurant"). The recommended entity types and entities are relevant to both user context (past behaviors) and sensor context (time and geo-location). Specifically, it estimates the generation probability of an entity by a given user conditioned on the current context in a probabilistic framework. A random-walk propagation is then employed to refine the estimated probability by mining the temporal patterns among entities. We deploy a recommendation application based on the proposed approach on Window Phone 7 devices. We evaluate recommendation performance on 10 thousand mobile clicks, as well as user experience through subjective user studies. We show that the application is effective to facilitate the exploration and discovery of surroundings for mobile users.

Abstract:Being part and parcel of the daily life for billions of people all over the globe, the domain of mobile Applications (Apps) is the fastest growing sector of mobile market today. Users, however, are frequently overwhelmed by the vast number of released Apps and frequently updated versions. Towards this end, we propose a novel version-sensitive mobile App recommendation framework. It is able to recommend appropriate Apps to right users by jointly exploring the version progression and dual-heterogeneous data. It is helpful for alleviating the data sparsity problem caused by version division. As a byproduct, it can be utilized to solve the in-matrix and out-of-matrix cold-start problems. Considering the progression of versions within the same categories, the performance of our proposed framework can be further improved. It is worth emphasizing that our proposed version progression modeling can work as a plug-in component to be embedded into most of the existing latent factor-based algorithms. To support the online learning, we design an incremental update strategy for the framework to adapt the dynamic data in real-time. Extensive experiments on a real-world dataset have demonstrated the promising performance of our proposed approach with both offline and online protocols. Abstract:With the proliferation of smart phones, mobile applications (APPs) are increasingly being used for mobile work and entertainment. In order to satisfy people's various demands, there are enormous mobile applications being delivered through different mobile application markets. This brings markets owners huge opportunities and tough challenges simultaneously. It is very difficult to find proper APPs for users within such large number of APPs. To alleviate this problem, traditional recommendation techniques are introduced into APPs recommendation. However, different from traditional context, APPs recommendation is a very unique task since people use APPs for different reasons. In this paper, we analyzed user's usage and download behaviors based on a real Android Market data to seek useful information which can benefit APPs recommendation task. We present a new matrix factorization algorithm which incorporates APPs popularity and user behaviors. The experiment shows our method outperforms traditional recommendation approaches in mobile recommendation context.
Modeling User Engagement in Mobile Content Consumption with Tapstream Data and Field Experiment

Abstract:Low engagement rates and high attrition rates have been formidable challenges to mobile apps and their long-term success, especially for those whose revenues derive mainly from in-app purchases. To date, little is known about how companies can scientifically detect user engagement stages and optimize corresponding personalized-targeting promotion strategies so as to improve business revenues. This paper proposes a new structural forward-looking Hidden Markov Model (FHMM) as combined with a randomized field experiment on app notification promotions. Our model can recover consumer latent engagement stages by accounting for both the time-varying nature of users' engagement and their forward-looking consumption behavior. Although app users in most of the engagement stages are likely to become less dynamically engaged, this slippery slope of user engagement can be alleviated by randomized treatments of app promotions. The structural estimates from the FHMM with the field-experimental data also enable us to identify heterogeneity in the treatment effects, specifically in terms of the causal impact of app promotions on continuous app consumption behavior across different hidden engagement stages. Additionally, we simulate and optimize the revenues of different personalized-targeting promotion strategies with the structural estimates. Personalized dynamic engagement-based targeting based on the FHMM can, compared with non-personalized mass promotion, generate 101.84% more revenue for the price promotion and 72.46% more revenue for the free content promotion. It also can generate substantially higher revenues than the experience-based targeting strategy applied by current industry practices and targeting strategies based on alternative customer segmentation models such as k-means or myopic HMM. Overall, the novel feature of our paper is its proposal of a new personalized-targeting approach combining the FHMM with a field experiment to tackle the challenge of low engagement with mobile apps.

Abstract:With the widespread usage of smart phones, more and more mobile apps are developed every day, playing an increasingly important role in changing our lifestyles and business models. In this trend, it becomes a hot research topic for developing effective mobile app recommender systems in both industry and academia. Compared with existing studies about mobile app recommendations, our research aims to improve the recommendation effectiveness based on analyzing a psychological trait of human beings, exploratory behavior, which refers to a type of variety-seeking behavior in unfamiliar domains. To this end, we propose a novel probabilistic model named Goal-oriented Exploratory Model (GEM), integrating exploratory behavior identification with personalized item recommendation. An algorithm combining collapsed Gibbs sampling and Expectation Maximization is developed for model learning and inference. Through extensive experiments conducted on a real dataset, the proposed model demonstrates superior recommendation performances and good interpretability compared with state-of-art recommendation methods. Moreover, empirical analyses on exploratory behavior find that individuals with a strong exploratory tendency exhibit behavioral patterns of variety seeking, risk taking, and higher involvement. Besides, mobile apps that are less popular or in the long tail possess greater potential of arousing exploratory behavior in individuals.

Abstract:With rapid growth of mobile applications,users of mobile app platforms are facing problem of information overload.Large number of apps make it difficult for users to find appropriate ones,while many long tail apps are submerged in the resource pool and are unknown to most users.Meanwhile,existing recommendation methods usually pay more attention to accuracy than diversity,making popular apps as most recommended items.As a result,the overall exposure rate of mobile apps is low as behavior data accumulated by the system is gradually biased towards popular apps,which leads to a poor recommendation performance in the long run.To solve this problem,this article first proposes two recommendation methods,named LDA_MF and LDA_CF,to improve existing methods.LDA_MF combines user topic model and app topic model with matrix factorization model MF,and LDA_CF takes both tag information of apps and user behavior data into consideration.In order to take advantages of different algorithms and increase the diversity of recommendation results without sacrificing accuracy,a hybrid recommendation algorithm is also provided to combine LDA_MF,LDA_CF and item-based collaborative filtering models.A large real data set is used to evaluate the proposed methods,and the results show that the presented approach achieves better diversity and good recommendation accuracy.

While most of the current works focused on proposing novel recommendation models for mobile apps, the lack of understanding of user download behaviors still remains a problem. Towards this end, we conducted a user behavior study on a large scale real world dataset, focusing on three kinds of biases to user download behaviors, namely, browsing history, app update history, and app categories. The dataset we used in this paper was constructed from Mobile Market (MM), an online mobile app store released by China Mobile, server logs from April 16, 2013 to June 13, 2013, containing 12,125,702 users and 67,577 apps.

Abstract:Innovative mobile applications bring radical changes to people's life around the globe. With its unique characteristics of anywhere, anytime accessibility, thousands of mobile apps are developed, distributed, and executed over the Internet. To understand the selection criteria for different end users when facing a mobile application, this paper quests for an evaluation framework for mobile apps based statistical data analysis and survey. Firstly, user's ratings on 1500+ mobile applications from Google Play were analyzed to elicit different users' preferences on mobile apps. The data was extracted twice, first at the end 2015, then early 2017, and the data are from four different locations: The UK, USA, Netherland, and Pakistan. Secondly, the survey was conducted to collect university students rationale when making selections and downloading decisions of a mobile app. Furthermore, the knowledge gathered from data and survey is used to propose a systematic evaluation framework. Finally, the proposed framework is used to develop a recommender system for the mobile app markets. The implementation of the recommender system is introduced, and which was further verified by an example case.

Abstract:Rapid growth in the number of smart phones users brings endless opportunities and enormous challenges for mobile Internet applications. How to recommend applications in which users are interested draws attentions of the application stores. In this paper, the features of different categories applications are extracted by analyzing users behavior of downloading. Based on association rules, the recommendations of overall and different categories applications can be generated respectively, as well as the recommendations of applications that are most likely to be accepted by users based on collaborative filtering. In this method, two recommendation strategies are proposed: the triggered recommendation strategy which is based on the optimum number of the application in the user’s smart phone and the automatic recommendation strategy which is based on the evaluation of users’ historical performance. The experiment result demonstrates the feasibility and effectivity of these recommendation strategies.

Abstract:Users install many apps on their smartphones, raising issues related to information overload for users and resource management for devices. Moreover, the recent increase in the use of personal assistants has made mobile devices even more pervasive in users' lives. This paper addresses two research problems that are vital for developing effective personal mobile assistants: target apps selection and recommendation. The former is the key component of a unified mobile search system: a system that addresses the users' information needs for all the apps installed on their devices with a unified mode of access. The latter, instead, predicts the next apps that the users would want to launch. Here we focus on context-aware models to leverage the rich contextual information available to mobile devices. We design an in situ study to collect thousands of mobile queries enriched with mobile sensor data (now publicly available for research purposes). With the aid of this dataset, we study the user behavior in the context of these tasks and propose a family of context-aware neural models that take into account the sequential, temporal, and personal behavior of users. We study several state-of-the-art models and show that the proposed models significantly outperform the baselines.

Abstract:Recommendation systems that provide appropriate solutions to users to reduce their decision complexity have become popular in the Internet world. Designing and evaluating such systems remain essential challenges to researchers and practitioners. Toward that end, a critical task is how to obtain user preferences. Mobile phones have become indispensable in everyday life, yet fierce market competition, characterized by rapid introductions of different models with novel designs and advanced features, have made consumers’ purchase decision making increasingly complex. As a well-established, multiple criteria decision technique, analytic hierarchy processing (AHP) provides an intuitive model of a hierarchical structure capable of supporting complex product comparisons and evaluations by consumers. In this paper, we illustrate the application of an AHP-based mechanism to develop a Web-based recommendation system and empirically evaluate the prototype by conducting a controlled experiment with 244 mobile phone users, focusing on both content and system satisfaction. Our evaluation includes benchmark systems built on rank-based analysis and an equal weight-based system as comparative baselines. Overall, the results suggest the viability and value of using AHP to construct effective recommendation systems. Subjects appear satisfied with the recommendations by the AHP-based system, though its relatively demanding input requirements may need mitigation and adequate interface designs. This study contributes to research and practice in recommender systems in general and helps develop mobile phone recommendation systems for online stores and consumers in particular.

Abstract:The ever growing popularity of smart mobile devices and rapid advent of wireless technology have given rise to a new class of advertising system, i.e., mobile advertisement recommender system. The traditional internet advertising systems have largely ignored the fact that users interact with the system within a particular “context”. In this paper, we implemented a mobile advertisement recommender prototype system called MARS. MARS captures different user’s contextual information to improve recommendation results. The demonstration shows that MARS makes advertisement recommendation more effectively.

Abstract:Advances in smartphone technology have promoted the rapid development of mobile apps. However, the availability of a huge number of mobile apps in application stores has imposed the challenge of finding the right apps to meet the user needs. Indeed, there is a critical demand for personalized app recommendations. Along this line, there are opportunities and challenges posed by two unique characteristics of mobile apps. First, app markets have organized apps in a hierarchical taxonomy. Second, apps with similar functionalities are competing with each other. Although there are a variety of approaches for mobile app recommendations, these approaches do not have a focus on dealing with these opportunities and challenges. To this end, in this article, we provide a systematic study for addressing these challenges. Specifically, we develop a structural user choice model (SUCM) to learn fine-grained user preferences by exploiting the hierarchical taxonomy of apps as well as the competitive relationships among apps. Moreover, we design an efficient learning algorithm to estimate the parameters for the SUCM model. Finally, we perform extensive experiments on a large app adoption dataset collected from Google Play. The results show that SUCM consistently outperforms state-of-the-art Top-N recommendation methods by a significant margin.

Recommendations from friends anytime and anywhere: toward a model of contextual offer and consumption values

Abstract:The ubiquity and portability of mobile devices provide additional opportunities for information retrieval. People can easily access mobile applications anytime and anywhere when they need to acquire specific context-aware recommendations (contextual offer) from their friends. This study, thus, represents an initial attempt to understand users' acceptance of a mobile-based social reviews platform, where recommendations from friends can be obtained with mobile devices. Based on the consumption value theory, a theoretical model is proposed and empirically examined using survey data from 218 mobile users. The findings demonstrate that contextual offers based on users' profiles, access time, and geographic positions significantly predict their value perceptions (utilitarian, hedonic, and social), which, in turn, affect their intention to use a mobile social reviews platform. This study is also believed to provide some useful insights to both research and practice.
