Abstract:In the smaller-aperture imaging system for aerospace application, the diffraction degradation in the image resulted from the finite-size aperture of an optical system is troublesome. A great deal of effort has been made to restore the degraded image. Unfortunately, the process of restoration is an ill-conditioned problem, especially for the images with severely noise. The paper presents an analysis of the influence of various noise including salt-and-pepper noise, Gaussian noise and periodic noise on the restoration of diffraction-limited images, with the method of Wiener filtering, constrained adaptive restoration algorithm and iterative blind restoration algorithm. It is proved that the iterative blind restoration algorithm is superior to the others for the image with Gaussian noise and salt-and-pepper noise, though the resistibility to salt-and-pepper noise of the three approaches is all weak. Wiener filtering is effective for eliminating the periodic noise while the other two is invalid, but the restored image is not sharp enough. It is suggested to remove salt-and-pepper noise with median-filter, and periodic noise with frequency domain band-reject filter before the restoration.

Abstract:The radiance received by the sensor is influenced by the atmospheric interaction including the effects of absorption and scattering. Based on the analysis of the radiance along the transmission path, we propose an image degradation model and a recovery method for remote sensing and bad weather condition in which the effect of multiple scattering cannot be ignored. Several real outdoor images are restored to verify the effectiveness of the proposed model and method. The results turn out to be significantly improved in contrast and sharpness. Abstract:Remote sensing images are seriously degraded by multiple scattering and bad weather. Through the analysis of the radiative transfer procedure in atmosphere, an image atmospheric degradation model considering the influence of atmospheric absorption multiple scattering and non-uniform distribution is proposed in this paper. Based on the proposed model, a novel recovering method is presented to eliminate atmospheric degradation. Mean-shift image segmentation and block-wise deconvolution are used to reduce time cost, retaining a good result. The recovering results indicate that the proposed method can significantly remove atmospheric degradation and effectively improve contrast compared with other removal methods. The results also illustrate that our method is suitable for various degraded remote sensing, including images with large field of view (FOV), images taken in side-glance situations, image degraded by atmospheric non-uniform distribution and images with various forms of clouds.
Image Deblurring by Motion Estimation for Remote Sensing

Abstract:The imagery resolution of imaging systems for remote sensing is often limited by image degradation resulting from unwanted motion disturbances of the platform during image exposures. Since the form of the platform vibration can be arbitrary, the lack of priori knowledge about the motion function (the PSF) suggests blind restoration approaches. A deblurring method which combines motion estimation and image deconvolution both for area-array and TDI remote sensing has been proposed in this paper. The image motion estimation is accomplished by an auxiliary high-speed detector and a sub-pixel correlation algorithm. The PSF is then reconstructed from estimated image motion vectors. Eventually, the clear image can be recovered by the Richardson-Lucy (RL) iterative deconvolution algorithm from the blurred image of the prime camera with the constructed PSF. The image deconvolution for the area-array detector is direct. While for the TDICCD detector, an integral distortion compensation step and a row-by-row deconvolution scheme are applied. Theoretical analyses and experimental results show that, the performance of the proposed concept is convincing. Blurred and distorted images can be properly recovered not only for visual observation, but also with significant objective evaluation increment.
Restoration method of TDI remote sensing image based on optimization of numerical fidelity term

Abstract:A restoration method was proposed based on the optimization of numerical fidelity term in order to recover the time delay integration (TDI)-charge-coupled device (CCD)remote sensing image with vibration blur.The blur kernel was constructed line by line according to the flutter information of the imaging platform due to the spatial variation of the point spread function (PSF)of the TDI degraded images.A new deblurring algorithm for remote sensing images was presented to restore blurred images line by line by combining L1-norm regularization and optimization in numerical fidelity.The numerical fidelity term was extended to the second order in order to better recover image details in the process of constructing the image deblurring model based on maximum a posteriori probability(MAP).The proposed algorithm obtained sharper deblurring results compared with traditional Richardson-Lucy (RL)algorithm and the total variational method.Image structural similarity index measurement (SSIM)in different integral series and vibration frequencies showed the universality of the new algorithm.

Abstract:A ringing effect often occurs in restored images, and its typical feature is that there are Gibbs-like oscillations in the neighboring areas of an image with sharp gray scale variations. The existence of the ringing effect causes it to be difficult for the restored images to be subsequently processed and some image quality evaluation methods to be invalid. In this paper, we studied several image restoration methods for diffraction-degraded remote sensing image: a Wiener filtering algorithm that is a simple and rapid image restoration algorithm, which is especially suitable for images without noise and with accurate PSF estimation and a small degree of blurring; an RL (Richardson-Lucy) algorithm that can gradually improve the image definition with an increase in iterations but the ringing effect becomes more and more significant; and a TV (total variation) algorithm that is a normalization algorithm based on noise and ringing suppression. We used multiple parameters to evaluate the restored images, including BDQ (block difference quality), GMG (gray mean grads), LS (Laplacian operator sum), and LE (large entropy), for which reference image are not required, as well as PSNR (peak signal noise ratio), SSIM (structural similarity), GRM(Gradient Ringing Metric) and HVSWGM (weighted gradient metric based on human visual system), for which reference image are required. The results show that the HVSWGM method is insensitive to the ringing effect occurring in image restoration and the evaluation result is completely consistent with a subjective evaluation result with a human visual system, and that many non-reference methods fail completely in assessing restored image with ringing effect, and only BDQ method is able to conform to subjective evaluation method to some extent.

Abstract:Developing denoising algorithms for hyperspectral remote sensing images (HSIs) can alleviate noise problem, improve data utilization as well as the accuracy of subsequent applications. However, existing denoising techniques are usually unstable due to the variations of landscapes, resulting in local distortion of HSIs, especially in heterogeneous areas. To tackle this issue, we propose a spatial–spectral interactive restoration (SSIR) framework by exploiting the complementarity of model-based and data-driven methods. Specifically, a deep learning-based denoising module that incorporates both convolutional neural networks (CNN) and Swin Transformer (TF) blocks is designed. This denoiser can achieve local–global dependencies modeling and content-based interactions to better capture global heterogeneity differences in HSIs. Moreover, we introduce an unsupervised unmixing module that utilizes spectral autocorrelation as prior information to effectively capture the differences in reflectance characteristics among different land cover components. This parameter-free module further improves the generalization ability of SSIR and enables stable denoising performance across different scenarios. Both modules are iteratively updated and fuel each other in SSIR. The proposed SSIR is shown to outperform others in preserving spatial details, maintaining spectral fidelity, and adapting to different landscapes based on simulated and real experiments conducted on various HSIs under diverse noise conditions.

Abstract:The precision of the traditional satellite remote sensing image denoising model cannot deal well with some precise production scenes. To solve this problem, this research proposes an improved remote sensing image processing model, in which the dual tree complex wavelet transform (DTCWT) method is used to conduct multiscale decomposition of the impact, and the fourth-order differential equation is used to denoise the decomposed complex high-frequency subband information, and then the denoised subbands are reconstructed into the denoised image. Through these two advanced signal-processing methods, the quality of reconstructed signals is improved and the noise content of various types is greatly reduced. The experimental results show that the normalized root mean square error of the denoising model designed in this study after training convergence is 0.02. When the noise variance is 0.030, the structure similarity, peak signal to noise ratio, and normalized signal to noise ratio are 0.74, 25.3, and 0.76, respectively, which are better than all other comparison models. The experimental data prove that the satellite remote sensing image data denoising model designed in this study has better denoising performance, and has certain application potential in high-precision satellite remote sensing image big data processing.

Abstract:The development of image classification is one of the most important research topics in remote sensing. The prediction accuracy depends not only on the appropriate choice of the machine learning method but also on the quality of the training datasets. However, real-world data is not perfect and often suffers from noise. This paper gives an overview of noise filtering methods. Firstly, the types of noise and the consequences of class noise on machine learning are presented. Secondly, class noise handling methods at both the data level and the algorithm level are introduced. Then ensemble-based class noise handling methods including class noise removal, correction, and noise robust ensemble learners are presented. Finally, a summary of existing data-cleaning techniques is given.

Abstract:Existing image processing methods usually divide image denoising and image fusion into two directions for research, and even the best current image denoising methods such as DnCNN can cause information loss during image processing, and the image fusion method mainly considers the fusion between multiple source images to complement the image information, but does not take into account the degradation of the fusion quality due to the noise in the source images. Therefore, aiming at the problem that various existing image denoising methods cannot reduce noise efficiently in complex noise situations while performing multi-source image fusion, preserving texture details, highlighting edge contour structures, and enriching image energy, a method of reconstructing remote sensing images by simplified adaptive dual-channel PCNN (Dual-PCNN) fusion in the NSCT transform domain is proposed to unify image noise reduction and image fusion under the same framework to obtain a noisy image information reconstruction method, which completes the complementary advantages between two image processing methods. Firstly, the impulse noise in the image is removed using IMFLED filtering, and then the Gaussian noise is processed by DnCNN and FFDNet respectively, and the results are imported into simplified parametric adaptive dual-channel PCNN to fuse the preprocessed images respectively. Then the DnCNN image and the preprocessed image are decomposed by NSCT to obtain each low-frequency sub-band and high-frequency sub-band. The low-frequency sub-band is stimulated with detail using the guided filter, and the high-frequency sub-band is enhanced by separating the detail layer through the guided filter to obtain the energy-detail-enhanced high-frequency sub-band. Finally, the corresponding sub-bands are fused into the simplified parametric adaptive dual-channel PCNN respectively, and the fused sub-band coefficients are reconstructed by NSCT inversion to obtain the final reconstructed remote sen- ing image. The experiments on grayscale images and remote sensing images show that this method achieves excellent results in both visual subjective and quantitative index evaluation, and the reconstructed images perform well in texture details, contour structure, and energy enrichment. After the information reconstruction of remote sensing images, the quality and resolution of remote sensing images are effectively improved, so that terrain information, landform features, and structural features can be extracted more accurately, which are widely used in remote sensing and geographic information fields such as landform analysis, agricultural monitoring, building inspection and environmental protection.

Abstract:Remote sensing imagery is generally prone to various radiometric distortions such as stripe noise, line loss, line or column drop out, banding, random bad pixels i.e. shot noise. These errors arrive due to on-board anomalies. These severely degrade the radiometric quality of the measured imagery and introduce a considerable level of incorrectness. Images with such a considerable level of radiometric incorrectness cannot be used directly for any image analysis application. It needs to be analyzed and pre-processed with Image Processing techniques before going to generate the data for the use of various applications. This paper presents a global residual learning method-based deep neural network (DNN) approach to automatically remove stripe noise of various types and shot noise as well, and hence improves the image quality of remote sensing imagery. The proposed method shows improved performance in terms of Peak Signal-to-Noise Ratio (PSNR) and Structural Similarity Index Measure (SSIM) quality measures when compared with the state-of-the-art methods. In addition, destriping by residual DNN is followed by a new post-processing step using multilevel wavelet decomposition and frequency domain filtering to remove the residual striping artefacts. A global residual learning method, batch normalization, mini batch selection and skip connection steps help speeding up the training process as well as boost the network performance.

A Review of Remote Sensing Image Dehazing

Abstract:Remote sensing (RS) is one of the data collection technologies that help explore more earth surface information. However, RS data captured by satellite are susceptible to particles suspended during the imaging process, especially for data with visible light band. To make up for such deficiency, numerous dehazing work and efforts have been made recently, whose strategy is to directly restore single hazy data without the need for using any extra information. In this paper, we first classify the current available algorithm into three categories, i.e., image enhancement, physical dehazing, and data-driven. The advantages and disadvantages of each type of algorithm are then summarized in detail. Finally, the evaluation indicators used to rank the recovery performance and the application scenario of the RS data haze removal technique are discussed, respectively. In addition, some common deficiencies of current available methods and future research focus are elaborated.
A Second-Order Method for Removing Mixed Noise from Remote Sensing Images

Abstract:Remote sensing image denoising is of great significance for the subsequent use and research of images. Gaussian noise and salt-and-pepper noise are prevalent noises in images. Contemporary denoising algorithms often exhibit limitations when addressing such mixed noise scenarios, manifesting in suboptimal denoising outcomes and the potential blurring of image edges subsequent to the denoising process. To address the above problems, a second-order removal method for mixed noise in remote sensing images was proposed. In the first stage of the method, dilated convolution was introduced into the DnCNN (denoising convolutional neural network) network framework to increase the receptive field of the network, so that more feature information could be extracted from remote sensing images. Meanwhile, a DropoutLayer was introduced after the deep convolution layer to build the noise reduction model to prevent the network from overfitting and to simplify the training difficulty, and then the model was used to perform the preliminary noise reduction on the images. To further improve the image quality of the preliminary denoising results, effectively remove the salt-and-pepper noise in the mixed noise, and preserve more image edge details and texture features, the proposed method employed a second stage on the basis of adaptive median filtering. In this second stage, the median value in the original filter window median was replaced by the nearest neighbor pixel weighted median, so that the preliminary noise reduction result was subjected to secondary processing, and the final denoising result of the mixed noise of the remote sensing image was obtained. In order to verify the feasibility and effectiveness of the algorithm, the remote sensing image denoising experiments and denoised image edge detection experiments were carried out in this paper. When the experimental results are analyzed through subjective visual assessment, images denoised using the proposed method exhibit clearer and more natural details, and they effectively retain edge and texture features. In terms of objective evaluation, the performance of different denoising algorithms is compared using metrics such as mean square error (MSE), peak signal-to-noise ratio (PSNR), and mean structural similarity index (MSSIM). The experimental outcomes indicate that the proposed method for denoising mixed noise in remote sensing images outperforms traditional denoising techniques, achieving a clearer image restoration effect.

Abstract:Remote sensing images (RSIs) have been applied to many fields, such as environmental monitoring, urban planning, and military defense. All-day thermal infrared imaging observation system can finely portray the trajectory of human activities and provide data support for United Nations sustainable development planning. However, in the process of RSIs, image quality degradation containing image blurring is caused by optical system aberration, satellite platform vibration, imaging system out-of-focus, and atmospheric turbulence. Moreover, stripe noise in the image is produced by the nonuniformity of infrared sensors. Image deblurring and destriping are classical tasks in RSIs, but the above two problems are discussed separately in almost all research, i.e., denoising after adding stripe noise on clear images or deblurring under the assumption that only random noise exists. In this article, stripe noise and blur are jointly removed from on-orbit RSIs acquired by the thermal infrared spectrometer (TIS) on the SDGSAT-1 satellite, using a method based on stripe component residuals and gradient property. According to the experimental results, the performance of the proposed method is greatly improved compared with processing these two tasks separately, which can provide a valuable reference for the study of high-resolution thermal infrared RSIs recovery.

Abstract:Time delay and integration (TDI) cameras are widely used in remote sensing areas because they capture high-resolution and high signal-to-noise ratio (SNR) images and images in low-light environments. However, the image quality captured by TDI cameras may be affected by many degradation factors, including jitter, charge transfer time mismatch, and drift angle. Moreover, compared with the single-line push-broom cameras and area gaze cameras used in remote sensing, the degraded effect of the TDI camera may accumulate during the charge accumulation process. In this article, we present a fast imaging simulation method for remote sensing TDI cameras based on image resampling that can accurately simulate the degraded image quality affected by different degradation factors. The simulated image pairs can provide a sufficient dataset for modern supervised-learning image restoration methods. In addition, we present a novel network, containing a row-attention block and row-encoder block to help resolve the row-variant blur to resolve the degraded images. We test our image restoration method on the simulated degraded image datasets and real images; the results show that the proposed method can effectively restore degraded images. Our restoration method does not rely on auxiliary information detected by high-frequency sensors or multispectral bands, and it achieves better results than other blind restoration methods.

Abstract:At present, with the advance of satellite image processing technology, remote sensing images are becoming more widely used in real scenes. However, due to the limitations of current remote sensing imaging technology and the influence of the external environment, the resolution of remote sensing images often struggles to meet application requirements. In order to obtain high-resolution remote sensing images, image super-resolution methods are gradually being applied to the recovery and reconstruction of remote sensing images. The use of image super-resolution methods can overcome the current limitations of remote sensing image acquisition systems and acquisition environments, solving the problems of poor-quality remote sensing images, blurred regions of interest, and the requirement for high-efficiency image reconstruction, a research topic that is of significant relevance to image processing. In recent years, there has been tremendous progress made in image super-resolution methods, driven by the continuous development of deep learning algorithms. In this paper, we provide a comprehensive overview and analysis of deep-learning-based image super-resolution methods. Specifically, we first introduce the research background and details of image super-resolution techniques. Second, we present some important works on remote sensing image super-resolution, such as training and testing datasets, image quality and model performance evaluation methods, model design principles, related applications, etc. Finally, we point out some existing problems and future directions in the field of remote sensing image super-resolution.

A Progressive Image Restoration Network for High-order Degradation Imaging in Remote Sensing

Abstract:Recently, deep learning methods have gained remarkable achievements in the field of image restoration for remote sensing (RS). However, most existing RS image restoration methods focus mainly on conventional first-order degradation models, which may not effectively capture the imaging mechanisms of remote sensing images. Furthermore, many RS image restoration approaches that use deep learning are often criticized for their lacks of architecture transparency and model interpretability. To address these problems, we propose a novel progressive restoration network for high-order degradation imaging (HDI-PRNet), to progressively restore different image degradation. HDI-PRNet is developed based on the theoretical framework of degradation imaging, offering the benefit of mathematical interpretability within the unfolding network. The framework is composed of three main components: a module for image denoising that relies on proximal mapping prior learning, a module for image deblurring that integrates Neumann series expansion with dual-domain degradation learning, and a module for super-resolution. Extensive experiments demonstrate that our method achieves superior performance on both synthetic and real remote sensing images.

Unprocessing Images for Learned Raw Denoising

Abstract:Machine learning techniques work best when the data used for training resembles the data used for evaluation. This holds true for learned single-image denoising algorithms, which are applied to real raw camera sensor readings but, due to practical constraints, are often trained on synthetic image data. Though it is understood that generalizing from synthetic to real data requires careful consideration of the noise properties of image sensors, the other aspects of a camera's image processing pipeline (gain, color correction, tone mapping, etc) are often overlooked, despite their significant effect on how raw measurements are transformed into finished images. To address this, we present a technique to "unprocess" images by inverting each step of an image processing pipeline, thereby allowing us to synthesize realistic raw sensor measurements from commonly available internet photos. We additionally model the relevant components of an image processing pipeline when evaluating our loss function, which allows training to be aware of all relevant photometric processing that will occur after denoising. By processing and unprocessing model outputs and training data in this way, we are able to train a simple convolutional neural network that has 14%-38% lower error rates and is 9x-18x faster than the previous state of the art on the Darmstadt Noise Dataset, and generalizes to sensors outside of that dataset as well.

Abstract:Noise reduction is an active research area in image processing due to its importance in improving the quality of image for object detection and classification. In this paper, we develop a sparse representation based noise reduction method for hyperspectral imagery, which is dependent on the assumption that the non-noise component in an observed signal can be sparsely decomposed over a redundant dictionary while the noise component does not have this property. The main contribution of the paper is in the introduction of nonlocal similarity and spectral-spatial structure of hyperspectral imagery into sparse representation. Non-locality means the self-similarity of image, by which a whole image can be partitioned into some groups containing similar patches. The similar patches in each group are sparsely represented with a shared subset of atoms in a dictionary making true signal and noise more easily separated. Sparse representation with spectral-spatial structure can exploit spectral and spatial joint correlations of hyperspectral imagery by using 3-D blocks instead of 2-D patches for sparse coding, which also makes true signal and noise more distinguished. Moreover, hyperspectral imagery has both signal-independent and signal-dependent noises, so a mixed Poisson and Gaussian noise model is used. In order to make sparse representation be insensitive to the various noise distribution in different blocks, a variance-stabilizing transformation (VST) is used to make their variance comparable. The advantages of the proposed methods are validated on both synthetic and real hyperspectral remote sensing data sets.

Abstract:Remote Sensing is a markable achievement in- last century. High resolution is a vital technol- ogy to digital image characteristics. Especially, in recent 20 years, digital technology promotes the development of spatial information field. As the increasing requirement of people, achieving high resolution images is urgent. For this target, we work from four parts: spatial resolution, ra- diant resolution, spectral resolution, temporal resolution and proposed schemes for each of them with different imaging manners, designed several prototype systems and carried out many experiments to verify their feasibilities.
