Abstract:Load forecasting is of crucial importance for operations of electric power systems. In recent years, deep learning based methods are emerging for load forecasting because their strong nonlinear approximation capabilities can provide more forecasting precision than conventional statistical methods. However, they usually suffer from some problems, e.g., the gradient vanishment and over-fitting. In order to address these problems, an unshared convolution based deep learning model with densely connected network is proposed. In this model, the backbone is the unshared convolutional neural network and a densely connected structure is adopted, which could alleviate the gradient vanishment. What is more, we use a regularization method named clipped $L_2$-norm to overcome over-fitting, and design a trend decomposition strategy to address the possible distribution differences between the training and validation data. Finally, we conduct five case studies to verify the outperformance of our proposed deep learning model for deterministic and interval load forecasting. Two high-voltage and an medium-voltage real load datasets from Australia, Germany and America are used for model training and validation, respectively. Results show that the proposed model can achieve higher load forecasting accuracy, compared with other existing methods including the popular conventional methods such as naive forecast and generalized additive model, and deep learning methods, e.g., long short-term memory network, convolutional neural network, fully connected network, etc.

Abstract:In smart grids and electricity markets, the number of data generated by smart meters increase rapidly. To reduce the communication and storage overhead, data mining algorithms for load must be able to deal with massive and long data with an efficient data compression. On the other hand, load service entities want loads to be clustered in a finer manner for pricing mechanism, demand response or other applications. Thus, some local shapes or high-order features of load profiles should be concerned for a high-accuracy clustering. In this paper, a load data compression and classification method based on deep learning is proposed. It has the following two features: (1) Load data are compressed with Auto-Encoders nonlinearly. It achieves a higher compression ratio and a lower loss than conventional linear methods. (2) Load features are extracted in a layer- wise way and then classified using a probabilistic soft-max regression. Compared with some existing classifiers, the identification accuracy improves a lot. Case studies demonstrates the proposed deep learning method is a feasible tool to handle big data and dig hidden value of load on demand side.

Abstract:Load forecasting is critical to the task of energy management in power systems, for example, balancing supply and demand and minimizing energy transaction costs. There are many approaches used for load forecasting such as the support vector regression (SVR), the autoregressive integrated moving average (ARIMA), and neural networks, but most of these methods focus on single-step load forecasting, whereas multistep load forecasting can provide better insights for optimizing the energy resource allocation and assisting the decision-making process. In this work, a novel sequence-to-sequence (Seq2Seq)-based deep learning model based on a time series decomposition strategy for multistep load forecasting is proposed. The model consists of a series of basic blocks, each of which includes one encoder and two decoders; and all basic blocks are connected by residuals. In the inner of each basic block, the encoder is realized by temporal convolution network (TCN) for its benefit of parallel computing, and the decoder is implemented by long short-term memory (LSTM) neural network to predict and estimate time series. During the forecasting process, each basic block is forecasted individually. The final forecasted result is the aggregation of the predicted results in all basic blocks. Several cases within multiple real-world datasets are conducted to evaluate the performance of the proposed model. The results demonstrate that the proposed model achieves the best accuracy compared with several benchmark models.

Abstract:Accurate load forecasting guarantees the stable and economic operation of power systems. With the increasing integration of distributed generations and electrical vehicles, the variability and randomness characteristics of individual loads and the distributed generation has increased the complexity of power loads in power systems. Hence, accurate and robust load forecasting results are becoming increasingly important in modern power systems. The paper presents a multi-layer stacked bidirectional long short-term memory (LSTM)-based short-term load forecasting framework; the method includes neural network architecture, model training, and bootstrapping. In the proposed method, reverse computing is combined with forward computing, and a feedback calculation mechanism is designed to solve the coupling of before and after time-series information of the power load. In order to improve the convergence of the algorithm, deep learning training is introduced to mine the correlation between historical loads, and the multi-layer stacked style of the network is established to manage the power load information. Finally, actual data are applied to test the proposed method, and a comparison of the results of the proposed method with different methods shows that the proposed method can extract dynamic features from the data as well as make accurate predictions, and the availability of the proposed method is verified with real operational data.

Abstract:Load forecasting is of great significance for the safety and economic operation of integrated energy systems. In this paper, a combined short-term load forecasting method of electric, thermal and gas systems based on deep learning is presented. Firstly, the deep learning architecture, which consists of a deep belief network(DBN) at the bottom and a back-propagation(BP) network at the top, is introduced. As an unsupervised learning method, the deep belief network extracts abstract high-level features, and the multitask regression layer is used for supervised prediction. Then, a two-stage load forecasting system with offline training and online prediction is established, and the indexes to verify the prediction accuracy of the model are presented. Finally, the effectiveness of the multi-load forecasting method is verified by the actual data of an integrated energy system. The results show that the proposed deep learning algorithm has excellent performances in both computational efficiency and prediction accuracy.

Abstract:Short-term load forecasting can provide essential and informative inputs for various decision-making problems, such as optimal operation and control of power systems. In this paper, a novel ensemble wavelet deep learning approach is proposed for short-term load forecasting. Firstly, electricity load series are decomposed into one lower frequency component and three higher frequency components using wavelet decomposition. Then, the forecasting values of each component can be obtained by the ensemble deep learning model consisting of deep belief network, long short-term memory and multi-layer perceptron. Finally, the forecasting result of the proposed model is calculated by summing up the four components’ forecasting values. Numerical computational results have demonstrated the effectiveness of proposed forecasting model.

Abstract:Accurate and reliable low-voltage load forecasting is critical to optimal operation and control of distribution network and smart grid. However, compared to traditional regional load forecasting at high-voltage level, it faces tough challenges due to the inherent high uncertainty of the low-capacity load and distributed renewable energy integrated in the demand side. This paper proposes a novel hybrid ensemble deep learning (HEDL) approach for deterministic and probabilistic low-voltage load forecasting. The deep belief network (DBN) is applied to low-voltage load point prediction with the strong ability of approximating nonlinear mapping. A series of ensemble learning methods including bagging and boosting variants are introduced to improve the regression ability of DBN. In addition, the differencing transformation technique is utilized to ensure the stationarity of load time series for the application bagging and boosting methods. On the basis of the integrated thought of ensemble learning, a new hybrid ensemble algorithm is developed via integrating multiple separate ensemble methods. Considering the diversity in various ensemble algorithms, an effective K nearest neighbor classification method is utilized to adaptively determine the weights of sub-models. Furthermore, HEDL based probabilistic forecasting is proposed by taking advantage of the inherent resample idea in bagging and boosting. The effectiveness of the HEDL method for both deterministic and probabilistic forecasting has been systematically verified based on realistic load data from East China and Australia, indicating its promising prospective for practical applications in distribution networks.

Abstract:Load forecasting is a critical concern for the operation of regulated power systems and electricity markets. It can guarantee the availability of electricity supply, minimize both excess and insufficient utilization of generating capacity and therefore optimize energy prices. In this paper, a novel multi-layer forecasting neural network based on feature weight optimization is developed for general reliable short-term load forecasting. It utilizes historical load data combined with some influencing factors such as seasonal and daily patterns as well as social behavior and user habits. Specifically, the proposed network involves a set of convolutional features extraction, bidirectional gate recurrent unit (BiGRU) and automatic feature weight optimization strategy, which subtly picks the nonlinear relationships and complex dependencies to facilitate the efficient generation of the close-to-true values. Experimental results demonstrate that the network achieves competitive performance with significantly higher accuracy when compared to congeneric methods, which greatly indicates its potential in the load forecasting tasks of electricity resource management.

Abstract:The management of electricity systems benefits considerably from short-term load forecasting. Although various superior short-term prediction algorithms have been investigated, some problems are still encountered in practical applications: (1) When dealing with data containing noise, there are unpredictable effects on short-term load forecasting. (2) Current deep learning models are time-consuming. In this study, we suggest an ensemble kernel broad learning system based on residuals to resolve the aforementioned issues. Specifically, we merge the broad learning system with kernel learning, which helps obtain stable features to improve the performance and avoid getting into the non-optimal problem. In addition, to further improve the prediction accuracy, we fuse multiple base learners to obtain an optimal prediction model from the residuals of the loss function. The experimental findings exhibit the efficacy and efficiency of our suggested technique.

Abstract:Abstract In order to accurately grasp the power consumption of the market and deeply understand the operation law of the power market, the power grid must achieve accurate power load prediction by studying the supply and demand of the power system and the change law. Therefore, a smart grid load prediction analysis method based on deep learning is proposed. Firstly, DenseNet network is used to extract features, so as to achieve feature reuse and improve efficiency. Then, combining the long short-term memory (LSTM) network based on attention mechanism, a combined model DenseNet–AM–LSTM is proposed to solve the long-term dependence problem of feature extraction. After using batch normalization, the model can use higher learning rate to improve the training speed of the model and obtain the best prediction accuracy of the model. The experimental results show that this method can accurately predict the power load, and the accuracy is higher than the current popular methods, and it is expected to become an important technical support for solving the core problems of smart grid.

Abstract:We present in this paper a model for forecasting short-term power loads based on deep residual networks. The proposed model is able to integrate domain knowledge and researchers' understanding of the task by virtue of different neural network building blocks. Specifically, a modified deep residual network is formulated to improve the forecast results. Further, a two-stage ensemble strategy is used to enhance the generalization capability of the proposed model. We also apply the proposed model to probabilistic load forecasting using Monte Carlo dropout. Three public datasets are used to prove the effectiveness of the proposed model. Multiple test cases and comparison with existing models show that the proposed model is able to provide accurate load forecasting results and has high generalization capability.

Abstract:Short-term electrical load forecasting plays an important role in the safety, stability, and sustainability of the power production and scheduling process. An accurate prediction of power load can provide a reliable decision for power system management. To solve the limitation of the existing load forecasting methods in dealing with time-series data, causing the poor stability and non-ideal forecasting accuracy, this paper proposed an attention-based encoder-decoder network with Bayesian optimization to do the accurate short-term power load forecasting. Proposed model is based on an encoder-decoder architecture with a gated recurrent units (GRU) recurrent neural network with high robustness on time-series data modeling. The temporal attention layer focuses on the key features of input data that play a vital role in promoting the prediction accuracy for load forecasting. Finally, the Bayesian optimization method is used to confirm the model’s hyperparameters to achieve optimal predictions. The verification experiments of 24 h load forecasting with real power load data from American Electric Power (AEP) show that the proposed model outperforms other models in terms of prediction accuracy and algorithm stability, providing an effective approach for migrating time-serial power load prediction by deep-learning technology.

Abstract:As a networked cyber physical system, smart grid plays an important role in improving energy efficiency, which has higher prediction accuracy requirement for load forecasting to realize intelligent dispatching. The existing works of load forecasting have considered the external factors to improve prediction accuracy, but ignored their varying and different impacts in different time. In order to solve this problem, firstly, a new method is designed to select external meteorological factors and construct new features to deal with the different impacts of external factors in different seasons. Secondly, a fuzzy processing method of calendar factor is proposed to explore the varying impact of the calendar factor in the holiday period. Finally, our proposed method is combined with LSTM and other three typical machine learning models, and experiments are performed on a load data set from the real power system. The results show that our proposed method can improve the prediction accuracy of the typical machine learning based models. Especially for LSTM, the MAPEs reach to 3.8% and 3.1% in winter and summer, with the improvements of 0.6% and 0.3% respectively.

Abstract:Accurate power load forecasting is crucial for the sustainable operation of smart grids. However, the complexity and uncertainty of load, along with the large-scale and high-dimensional energy information, present challenges in handling intricate dynamic features and long-term dependencies. This paper proposes a computational approach to address these challenges in short-term power load forecasting and energy information management, with the goal of accurately predicting future load demand. The study introduces a hybrid method that combines multiple deep learning models, the Gated Recurrent Unit (GRU) is employed to capture long-term dependencies in time series data, while the Temporal Convolutional Network (TCN) efficiently learns patterns and features in load data. Additionally, the attention mechanism is incorporated to automatically focus on the input components most relevant to the load prediction task, further enhancing model performance. According to the experimental evaluation conducted on four public datasets, including GEFCom2014, the proposed algorithm outperforms the baseline models on various metrics such as prediction accuracy, efficiency, and stability. Notably, on the GEFCom2014 dataset, FLOP is reduced by over 48.8%, inference time is shortened by more than 46.7%, and MAPE is improved by 39%. The proposed method significantly enhances the reliability, stability, and cost-effectiveness of smart grids, which facilitates risk assessment optimization and operational planning under the context of information management for smart grid systems.

Abstract:Electrical load forecasting is of great significance, which can guarantee the system stability under large disturbances and optimize the distribution of energy resources in the smart grid. Load forecasting of distribution is a very active research field and an important aspect, as the load power of distribution transformer is closely related to the health and reliable of the power grid. Deep Learning technology have shown to be very powerful in load forecasting of distribution. Based on the deep learning technology, this paper uses the historical load data of distribution transformer to establish an appropriate prediction model to predict the future load of transformer. In this paper, the long short-term memory(LSTM) model is used to predict the distribution transformer load. The idea of integrated learning is used to improve the accuracy of LSTM network in load forecasting. The input dimension of the model is enriched to solve the problem that the model cannot be built due to the lack of historical data. Finally, the experimental results show the superiority of the proposed method.
A deep learning model for short-term power load and probability density forecasting

Abstract:Accurate load forecasting is critical for power system planning and operational decision making. In this study, we are the first to utilize a deep feedforward network for short-term electricity load forecasting. Our results are compared to those of popular machine learning models such as random forest and gradient boosting machine models. Then, electricity consumption patterns are explored based on monthly, weekly and temperature-based patterns in terms of feature importance. Also, a probability density forecasting method based on deep learning, quantile regression and kernel density estimation is proposed. To verify the efficiency of the proposed methods, three case studies based on daily electricity consumption data for three Chinese cities for 2014 are conducted. The empirical results demonstrate that (1) the proposed deep learning-based approach exhibits better forecasting accuracy in terms of measuring electricity consumption relative to the random forest and gradient boosting model; (2) monthly, weekly and weather-related variables are key factors that have a great influence on household electricity consumption; and (3) the proposed probability density forecasting method is capable of forecasting high-quality prediction intervals via probability density forecasting.

Abstract:SummaryEnergy load forecasting plays an important role in the smart grid, which can affect the promoting energy production and consumption decision‐making processes. In this paper, the state‐of‐the‐art deep learning (DL) neural models are used in the short‐term load forecasting, including the multilayer perceptron (MLP), the convolutional neural network (CNN), and the long short‐term memory (LSTM). A novel loss function is proposed for the load forecasting, and two commonly used benchmarks are used to verify the validity of the proposed function. The simulation results show that the mean absolute percentage error (MAPE) of the proposed loss function is 19.63% lower than cross‐entropy and 2.34% lower than mean absolute error (MAE). We compared the mentioned neural networks in different aspects, and the results show that in energy load forecasting, CNN has superior performance than MLP and LSTM in terms of high accuracy and robustness to weather changes.

Abstract:Introduction: In the field of power systems, power load type prediction is a crucial task. Different types of loads, such as domestic, industrial, commercial, etc., have different energy consumption patterns. Therefore, accurate prediction of load types can help the power system better plan power supply strategies to improve energy utilization and stability. However, this task faces multiple challenges, including the complex topology of the power system, the diversity of time series data, and the correlation between data. With the rapid development of deep learning methods, researchers are beginning to leverage these powerful techniques to address this challenge. This study aims to explore how to optimize deep learning models to improve the accuracy of load type prediction and provide support for efficient energy management and optimization of smart grids. Methods: In this study, we propose a deep learning method that combines graph convolutional networks (GCN) and sequence-to-sequence (Seq2Seq) models and introduces an attention mechanism. The methodology involves multiple steps: first, we use the GCN encoder to process the topological structure information of the power system and encode node features into a graph data representation. Next, the Seq2Seq decoder takes the historical time series data as the input sequence and generates a prediction sequence of the load type. We then introduced an attention mechanism, which allows the model to dynamically adjust its attention to input data and better capture the relationship between time series data and graph data. Results: We conducted extensive experimental validation on four different datasets, including the National Grid Electricity Load Dataset, the Canadian Electricity Load Dataset, the United States Electricity Load Dataset, and the International Electricity Load Dataset. Experimental results show that our method achieves significant improvements in load type prediction tasks. It exhibits higher accuracy and robustness compared to traditional methods and single deep learning models. Our approach demonstrates advantages in improving load type prediction accuracy, providing strong support for the future development of the power system. Discussion: The results of our study highlight the potential of deep learning techniques, specifically the combination of GCN and Seq2Seq models with attention mechanisms, in addressing the challenges of load type prediction in power systems. By improving prediction accuracy and robustness, our approach can contribute to more efficient energy management and the optimization of smart grids.

Abstract:Accurate load forecasting is crucial for efficient power system management. Yet, it is particularly challenging during critical days, such as weekends and holidays, due to limited data samples and atypical load patterns. This study presents a tailored load prediction framework that leverages data preprocessing and deep learning to address these challenges. The framework incorporates a noise-reduction step, trend information, and critical day indicators into the data preprocessing phase. The deep learning component integrates a Convolutional Neural Network (CNN) for spatial feature extraction, a Long Short-Term Memory (LSTM) network for temporal feature analysis, and a Transformer to enhance forecasting accuracy through an encoder-decoder architecture and mixed spatio-temporal feature learning. Evaluation of two years of electricity load data from a southern Chinese industrial city confirms the framework’s efficacy in improving load forecasting during critical periods.

Abstract:As an important part of the power system, power load forecasting directly affects the national economy. Small improvements in power load forecasts can save millions of dollars for the power industry. Therefore, improving the accuracy of power load forecasting has always been the pursuing goal for a power system. Based on this goal, this paper proposes a novel connection, the dense average connection, in which the outputs of all preceding layers are averaged as the input of the next layer in a feed-forward fashion. Dense average connection can alleviate the problem of gradient explosion without introducing new parameters. Based on dense average connection, we construct the dense average network (DaNet) for power load forecasting. On two public datasets (ISO-NE dataset and NAU dataset), we use MAPE, MAE and RMSE to evaluate the performance of DaNet. The predictions of DaNet are better than those of existing benchmarks. On this basis, this paper uses the ensemble method to reduce the peak value of prediction bias, which helps to alleviate the dispatching problem caused by unexpected loads. To verify the reliability of the model predictions, the robustness is analyzed and verified by adding input disturbances. The experimental results show that the proposed model is effective and robust for power load forecasting.
