Abstract:Modelling and simulation can play a major role in the design, analysis, control, scale-up and optimisation of a host of technologies, including fuel cells and batteries [1, 2]. Experimental investigations and purely laboratory-based design can be both time consuming and costly. Modelling and simulation are tools that can help to reduce the timescales and financial costs, informing initial designs, rationalising observed phenomena to improve design concepts, and optimising designs or at least narrowing the window in which a search should be conducted in the laboratory.

Abstract:Predictions of whole polarisation or charge–discharge curves for fuel cells and batteries using machine learning has rarely been explored, despite the now vast efforts to apply such methods to the analysis of these technologies. The aforementioned curves contain vital signatures of performance and degradation, and are usually therefore amongst the main targets for more traditional modelling techniques. In this paper, we investigate state-of-the-art multivariate machine-learning methods for predicting polarisation and charge–discharge curves. We employ a reduced-dimensional approach that enables powerful Gaussian process and support vector regression models to approximate multivariate outputs. Both models are shown to be able to accurately approximate polarisation and charge–discharge curves from complex physics-based models, including the sequence of times associated with charge–discharge cycles under constant load. We provide comparisons to standard deep networks, which fail to yield satisfactory results with the volume of data available. The methods developed in this paper can be used to in a variety of applications, including optimisation and battery health management.

Abstract:Machine learning has emerged as a transformative force throughout the entire engineering life cycle of electrochemical batteries. Its applications encompass a wide array of critical domains, including material discovery, model development, quality control during manufacturing, real-time monitoring, state estimation, optimization of charge cycles, fault detection, and life cycle management. Machine learning excels in its ability to identify and capture complex behavioral trends in batteries, which may be challenging to model using more traditional methods. The goal of this survey paper is to synthesize the rich existing literature on battery machine learning into a structured perspective on the successes, challenges, and prospects within this research domain. This critical examination highlights several key insights. Firstly, the selection of data sets, features, and algorithms significantly influences the success of machine learning applications, yet it remains an open research area with vast potential. Secondly, data set richness and size are both pivotal for the efficacy of machine learning algorithms, suggesting a potential for active machine learning techniques in the battery systems domain. Lastly, the field of machine learning in battery systems has extensive room for growth, moving beyond its current focus on specific applications like state of charge (SOC) and state of health (SOH) estimation, offering ample opportunities for innovation and expansion.

Abstract:The development of redox flow batteries presents challenges in terms of scale-up, optimization, improvements in electrolyte stability, and the development of new materials [1]. These challenges can be tackled using a combination of laboratory analysis and modelling, which lowers the financial costs and timescales. Modelling of the cells can provide insights into the coupled physico-chemical processes, including heat and mass transfer, the redox reactions, charge transfer and any phase changes, all of which are difficult to quantify experimentally. For design and optimization, an accurate model can be invaluable.

Abstract:ML has emerged as a fundamental tool in RFB research, tackling diverse challenges and driving forward key innovations. This review explores the possible methodologies and applications of ML in RFB research, highlighting its role in enhancing performance, addressing scalability, quantifying uncertainties, facilitating decision‐making and promoting sustainability. ML is essential for further enhancing RFB performances, adeptly balancing efficiency, cost and stability. This review exploits the crucial role of computational methods in discovering and optimizing materials for redox flow batteries (RFBs). Integration of high‐throughput computational screening (HTCS) and machine learning (ML) accelerates materials discovery, guided by algorithms categorizing RFBs. A collaborative exploration, spanning macroscopic to mesoscopic scales, combines quantum machine learning with reinforcement learning, transfer learning, time series analysis, Bayesian optimization, active learning and various generative models. The collaborative integration of ML with computational techniques and experimental methods, anchored in experimentally validated Density Functional Theory (DFT) calculations and molecular dynamics (MD) simulations, proves indispensable for cost‐effective RFBs. Data collection and feature engineering are explored, emphasizing the integration of optimization goals and precise data collection within the ML framework. Feature analysis importance is highlighted, utilizing methods such as the filter, embedded, wrapper and deep learning methods for efficient energy materials exploration. Computational perspectives on materials features and operating conditions encompass membrane characteristics, fluid dynamics, temperature dependence and pressure sensitivity. Time‐dependent features and ML‐generated insights are crucial for understanding cycling performance intricacies, providing a comprehensive understanding of RFB materials.

Abstract:Emerging machine learning (ML) methodologies are widely applied in chemistry and materials science studies and are constructing a data-driven research paradigm. This review summarizes the applications of ML in rechargeable batteries from microscale to macroscale. Specifically, ML affords an emerging strategy to explore new functional for density functional theory calculations and new potentials for molecular dynamics simulations, which are expected to significantly enhance the challenging description concerning with interfaces or amorphous structures. Besides, ML possesses great potential to mine and unveil valuable information from both experimental and theoretical datasets. A quantitative "structure–function" correlation can thusly be established, the application of which includes predicting ionic conductivity of solids as well as forecasting battery lifespan. ML also exhibits great advantages in strategy optimization, such as fast-charge protocols. Lastly, an outlook on the future combination of multi-scale simulations, experiments, and ML is provided and the role of human in the data-driven research paradigm is highlighted.

Abstract:Batteries are vital energy storage carriers in industry and in our daily life. There is continued interest in the developments of batteries with excellent service performance and safety. Traditional trial-and-error experimental approaches have the limitations of high-cost and low-efficiency. Atomistic computational simulations are relatively expensive and take long time to screen massive materials. The rapid development of machine learning (ML) has brought innovations in many fields and has also changed the paradigm of the battery research. Numerous ML applications have emerged in the battery community, such as novel materials discovery, property prediction, and characterization. In this review, we introduced the workflow of ML, where the task, data, feature engineering, and evaluation were involved. Several typical ML models used in batteries were highlighted. In addition, we summarized the applications of ML for the discovery of novel materials, and for property and battery state prediction. The challenges for the application of ML in batteries were also discussed.

Abstract:Developing advanced battery materials, monitoring and predicting the health status of batteries, and effectively managing retired batteries are crucial for accelerating the closure of the whole industrial chain of power lithium-ion batteries for electric vehicles. Machine learning technology plays a vital role in the research, production, service, and retirement of lithium-ion batteries due to its robust learning and predictive capabilities. While there have been detailed and valuable reviews on this topic, a comprehensive summary of machine learning progress from the perspective of full lifecycle management of lithium-ion batteries is still lacking. This review divides the full lifecycle of lithium-ion batteries into three stages: pre-prediction, mid-prediction, and late prediction phases, and summarizes recent advances in different machine learning methods categorized as materials screening, life prediction, and cascade utilization. It also emphasizes the implementation and evaluation of hybrid machine learning models. Finally, potential research opportunities and future directions are presented, mainly from two aspects of battery databases and the application of large-scale time-series models. This review provides valuable guidance and reference for researchers and practitioners to broaden the scope of machine learning for its application in lithium-ion batteries.

Abstract:Abstract With its extremely strong capability of data analysis, machine learning has shown versatile potential in the revolution of the materials research paradigm. Here, taking dielectric capacitors and lithium‐ion batteries as two representative examples, we review substantial advances of machine learning in the research and development of energy storage materials. First, a thorough discussion of the machine learning framework in materials science is presented. Then, we summarize the applications of machine learning from three aspects, including discovering and designing novel materials, enriching theoretical simulations, and assisting experimentation and characterization. Finally, a brief outlook is highlighted to spark more insights on the innovative implementation of machine learning in materials science.

Abstract:<p>Machine learning plays an important role in accelerating the discovery and design process for novel electrochemical energy storage materials. This review aims to provide the state-of-the-art and prospects of machine learning for the design of rechargeable battery materials. After illustrating the key concepts of machine learning and basic procedures for applying machine learning in rechargeable battery materials science, we focus on how to obtain the most important features from the specific physical, chemical and/or other properties of material by using wrapper feature selection method, embedded feature selection method, and the combination of these two methods. And then, the applications of machine learning in rechargeable battery materials design and discovery are reviewed, including the property prediction for liquid electrolytes, solid electrolytes, electrode materials, and the discovery of novel rechargeable battery materials through component prediction and structure prediction. More importantly, we discuss the key challenges related to machine learning in rechargeable battery materials science, including the contradiction between high dimension and small sample, the conflict between the complexity and accuracy of machine learning models, and the inconsistency between learning results and domain expert knowledge. In response to these challenges, we propose possible countermeasures and forecast potential directions of future research. This review is expected to shed light on machine learning in rechargeable battery materials design and property optimization.</p>

Abstract:Lithium-ion batteries (LIBs) are vital energy-storage devices in modern society. However, the performance and cost are still not satisfactory in terms of energy density, power density, cycle life, safety, etc. To further improve the performance of batteries, traditional "trial-and-error" processes require a vast number of tedious experiments. Computational chemistry and artificial intelligence (AI) can significantly accelerate the research and development of novel battery systems. Herein, a heterogeneous category of AI technology for predicting and discovering battery materials and estimating the state of the battery system is reviewed. Successful examples, the challenges of deploying AI in real-world scenarios, and an integrated framework are analyzed and outlined. The state-of-the-art research about the applications of ML in the property prediction and battery discovery, including electrolyte and electrode materials, are further summarized. Meanwhile, the prediction of battery states is also provided. Finally, various existing challenges and the framework to tackle the challenges on the further development of machine learning for rechargeable LIBs are proposed.

Abstract:With the widespread use of lithium ion batteries in portable electronics and electric vehicles,further improvements in the performance of lithium ion battery materials and accurate prediction of battery state are of increasing interest to battery researchers.Machine learning,one of the core technologies of artificial intelligence,is rapidly changing many fields with its ability to learn from historical data and solve complex tasks,and it has emerged as a new technique for solving current research problems in the field of lithium ion batteries.This review begins with the introduction of the conceptual framework of machine learning and the general process of its application,then reviews some of the progress made by machine learning in both improving battery materials design and accurate prediction of battery state,and finally points out the current application problems of machine learning and future research directions.It is believed that the use of machine learning will further promote the large-scale application and improvement of lithium-ion batteries.

Abstract:The field of fluid mechanics is rapidly advancing, driven by unprecedented volumes of data from field measurements, experiments and large-scale simulations at multiple spatiotemporal scales. Machine learning offers a wealth of techniques to extract information from data that could be translated into knowledge about the underlying fluid mechanics. Moreover, machine learning algorithms can augment domain knowledge and automate tasks related to flow control and optimization. This article presents an overview of past history, current developments, and emerging opportunities of machine learning for fluid mechanics. It outlines fundamental machine learning methodologies and discusses their uses for understanding, modeling, optimizing, and controlling fluid flows. The strengths and limitations of these methods are addressed from the perspective of scientific inquiry that considers data as an inherent part of modeling, experimentation, and simulation. Machine learning provides a powerful information processing framework that can enrich, and possibly even transform, current lines of fluid mechanics research and industrial applications.

Abstract:Lithium-ion battery packs have been widely applied in many high-power applications which need battery management system (BMS), such as electric vehicles (EVs) and smart grids. Implementations of the BMS needs a combination between software and hardware, which includes battery state estimation, fault detection, monitoring and control tasks. This paper provides a comprehensive study on the state-of-the-art of machine learning approaches on BMS. It differentiates between these methods on the basis of principle, type, structure, and performance evaluation.

Abstract:Machine learning (ML)‐based modeling can accelerate the design of battery materials, but it may be unclear in some cases whether ML can play a useful role. In this review, the fundamentals of ML modeling are presented and best practices are illustrated with examples from original and published data. The potential for ML modeling of key battery design areas is discussed. Machine learning (ML)‐based approaches to battery design are relatively new but demonstrate significant promise for accelerating the timeline for new materials discovery, process optimization, and cell lifetime prediction. Battery modeling represents an interesting and unconventional application area for ML, as datasets are often small but some degree of physical understanding of the underlying processes may exist. This review article provides discussion and analysis of several important and increasingly common questions: how ML‐based battery modeling works, how much data are required, how to judge model performance, and recommendations for building models in the small data regime. This article begins with an introduction to ML in general, highlighting several important concepts for small data applications. Previous ionic conductivity modeling efforts are discussed in depth as a case study to illustrate these modeling concepts. Finally, an overview of modeling efforts in major areas of battery design is provided and several areas for promising future efforts are identified, within the context of typical small data constraints.

Abstract:Investigating the role of electrodes' physiochemical properties on their output voltage can be beneficial in developing high-performance batteries. To this end, this study uses a two-step machine learning (ML) approach to predict new electrodes and analyze the effects of their physiochemical properties on the voltage. The first step utilizes an ML model to curate an informative feature space that elucidates the relationship between physiochemical properties and voltage output. The second step trains an active learning model on the informative feature space using Bayesian optimization to screen potential battery electrodes from a dataset of 3656 materials. This strategy successfully identified 41 electrode materials that exhibit good electronic conductivity and host highly electronegative anions. This work provides an efficient strategy to discover novel electrode materials while integrating domain knowledge of chemistry and material science with ML in materials research.
Machine learning Approach to Battery Management and Balancing Techniques for Enhancing Electric Vehicle Battery Performance

Abstract:The objective of this research is to apply machine learning techniques to optimize electric vehicle battery management and balance to attain maximum battery performance. Here, we will assess and compare the efficiency and accuracy of decision tree classifier, ANN, and Naive Bayes classifiers in: predicting two optimal charging and discharging battery management strategies, prediction of the battery’s performance and detecting any abnormalities in it. . In this context, one machine learning model will be proposed to have the most advantageous performance. The experimental results details that such findings are attained, and the precision rates, recall rates, and F1-scores attained by net models exceed 98%. Additionally, the decision tree, as well as the Naive Bayes classifier, have impressive performance, and their accuracy rates exceed 90%. Decision trees along with Naive Bayes classifiers have also important impacts on the identification of classification of battery’s responses through probabilistic classification in the former. Our findings have important implications for ensuring electric vehicle batteries are managed more properly for optimal performance. Additionally, based on the results obtained, they can be utilized to help relevant stakeholders in the EV industry and other industries with battery usage implement practical measures that optimize battery performance, increase battery life, and reduce the incurred operational expenses of electric vehicle fleets.

Abstract:The discipline of fluid mechanics is developing quickly, propelled by previously unheard-of data volumes from experiments, field measurements, and expansive simulations at various spatiotemporal scales. The field of machine learning (ML) provides a plethora of methods for gleaning insights from data that can be used to inform our understanding of the fluid dynamics at play. As an added bonus, ML algorithms can be used to automate duties associated with flow control and optimization, while also enhancing domain expertise. This article provides a review of the background, current state, and potential future applications of ML in fluid mechanics. We provide an introduction to the most fundamental ML approaches and describe their applications to the study, modelling, optimization, and management of fluid flows. From the standpoint of scientific inquiry, which treats data as an integral aspect of modelling, experiments, and simulations, the benefits and drawbacks of these approaches are discussed. Since ML provides a robust information-processing framework, it can supplement and potentially revolutionize conventional approaches to fluid mechanics study and industrial applications.
