HC-OFD Net: Heterogeneity-Captured Network Towards Out-of-Distribution Generalization in Fault Diagnosis.

Abstract:Out-of-Distribution generalization in fault diagnosis (OOD-FD) has emerged as a prominent research area, primarily driven by the sparse and heterogeneous nature of labeled training samples encountered in real-world scenarios. Regrettably, existing fault diagnosis approaches often disregard the quantification of heterogeneity, leading to OOD-FD models that blindly assign deterministic fault categories, ultimately suffering from unreliable and imprecise risk estimations. Typically, these methodologies hinge upon the assumption of independent and identically distributed (i.i.d.) training and testing data, a condition that is seldom met in practice. In this article, we propose a novel architecture, named HC-OFD Net, that effectively tackles the challenges posed by heterogeneity and data noise in fault diagnosis. Our approach introduces quantifiable interaction information to traditional methods, empowering the definition, measurement, and empirical estimation of heterogeneity through the judicious use of model capacity and specific constraints. Notably, HC-OFD Net incorporates a non-parameter clustering technique that accounts for statistical perturbations, thus generating prototype representations that encapsulate the inherent “noise” and “ran-domness” exhibited by OOD data. Furthermore, we present an optimization proxy framework that enables the differentiability of the loss function through reparameterized representations. This framework facilitates efficient training and optimization of the HC-OFD Net. To evaluate the performance of our proposed methodology, we conducted extensive experiments on two real-world datasets: MFL pipelines and rolling bearings. The experimental results convincingly demonstrate that HC-OFD Net outperforms competing methods in OOD scenarios, showcasing reliable and precise performance with an average improvement of 3.73% over alternative approaches.
