Abstract:Topic popularity prediction is an important task on social media, which aims at predicting the ongoing trends of topics according to logged historical text-based records. However, only limited existing approaches apply sentiment analysis to facilitate popularity prediction. Public sentiment is worth taking into consideration because the topics with strong sentiment tend to spread faster and broader on social media. In this paper, we propose a novel framework, SENTI2POP, to predict topic popularity utilizing sentiment information. We first adapt a state-of-art popularity quantification method to capture the topic popularity, and then design a novel tree-like network (Tree-Net) combining Long Short-Term Memory (LSTM) and Convolutional Neural Network (CNN) for sentiment analysis. In addition, we propose a sentiment-aware time series prediction approach based on Dynamic Time Warping (DTW) and Autoregressive Integrated Moving Average model (ARIMA) to predict topic popularity. We prove by experiments that SENTI2POP outperforms the existing popularity prediction models on a real-world Twitter dataset by reducing the prediction error. Experimental results also show that SENTI2POP could be applied to improve the accuracy of most non-sentiment popularity prediction models.
SBTM: A Joint Sentiment and Behaviour Topic Model for Online Course Discussion Forums

Abstract:Large quantities of textual posts are increasingly generated in course discussion forums, and the accumulation of these data greatly increases the cognitive loads on online participants. It is imperative for them to automatically identify the potential semantic information derived from these textual discourse interactions. Moreover, existing topic models can discover the latent topics or sentimental polarities from textual data, but these models typically ignore the interactive ways of discussing topics, thus making it difficult to further construct topics’ semantic space from the perspective of document generation. To solve this issue, we proposed a joint sentiment and behaviour topic model called SBTM, which was an unsupervised approach for automatic analysis of learners’ discussed posts. The results demonstrated that SBTM was quantitatively effective on both model generalisation and topic exploration, and rich topic content was qualitatively characterised. Furthermore, the model can be potentially employed in some practical applications, such as information summarisation and behaviour-oriented personalised recommendation.

Abstract:Web based social services like Twitter and Weibo are popular nowadays. A large number of users generate massive text-based information continuously and as a result, many topic popularity prediction models arise. However, most of them simply use forwarding or view count to measure popularity, ignoring semantic relations between posts and the topic. Moreover, few model use the important component of opinion - sentiment, to enhance topic popularity prediction. Therefore, in this paper, we propose a attention-based convolutional network model to generate sentiment-aware time series and predict topic popularity. Our model quantifies popularity more accurately with posts' semantic information and incorporates sentiment into popularity prediction. Concretely, our model is composed of a semantic-aware popularity quantification metric, a sentiment intensity detection neural network, and an Autoregressive convolutional network prediction scheme. We have conducted extensive experiments to prove that our model outperforms the existing popularity prediction models on a real-world Twitter dataset. We find that sentiment time series have the ability to improve popularity prediction accuracy significantly. Furthermore, we find our prediction scheme is superior to other models in utilizing sentiment information.
Predicting the Popularity of Topics based on User Sentiment in Microblogging Websites

Abstract:Behavioral economics show us that emotions play an important role in individual behavior and decision-making. Does this also affect collective decision making in a community? Here we investigate whether the community sentiment energy of a topic is related to the spreading popularity of the topic. To compute the community sentiment energy of a topic, we first analyze the sentiment of a user on the key phrases of the topic based on the recent tweets of the user. Then we compute the total sentiment energy of all users in the community on the topic based on the Markov Random Field (MRF) model and graph entropy model. Experiments on two communities find the linear correlation between the community sentiment energy and the real spreading popularity of topics. Based on the finding, we proposed two models to predict the popularity of topics. Experimental results show the effectiveness of the two models and the helpful of sentiment in predicting the popularity of topics. Experiments also show that community sentiment affects collective decision making of spreading a topic or not in the community.

Abstract:With the popularity of various social media platforms, the number of people who tend to publish their opinions on the internet grows dramatically. Discovering the public sentiment towards new topics and events becomes an important and challenging task in sentiment analysis. Current methods have not considered the effects caused by user interactions, leading to inaccurate topic and sentiment extractions. In this paper, we propose a novel probabilistic generative model (TSIUM) to extract topics and topic-specific sentiments from online comments. We model the effects between online comments to avoid the error caused by user interactions. Experimental results show that the proposed model is able to accurately identify topics and filter spam and outperform other methods in the sentiment classification task, making a great improvement on both topic and sentiment extraction. © 2014 Springer International Publishing Switzerland.

Abstract:Nowadays plenty of user-generated posts, e.g., tweets and sina weibos, are published on social media and the posts imply the public's opinions towards various topics. Joint sentiment/topic models are widely applied in detecting sentiment-aware topics on the lengthy documents. However, the characteristics of posts, i.e., short texts, on social media pose new challenges: (1) context sparsity problem of posts makes traditional sentiment-topic models inapplicable; (2) conventional sentiment-topic models are designed for flat documents without structure information, while publishing users, publishing timeslices and hashtags of posts provide rich structure information for these posts. In this paper, we firstly devise a method to mine potential hashtags, based on explicit hashtags, to further enrich structure information for posts, then we propose a novel Sentiment Topic Model for Posts (STMP) which aggregates posts with the structure information, i.e., timeslices, users and hashtags, to alleviate the context sparsity problem. Experiments on Sentiment140 and Twitter7 show STMP outperforms previous models both in sentiment classification and sentiment-aware topic extraction.

Abstract:Twitter plays a significant role in information diffusion and has evolved to an important information resource as well as news feed. People wonder and care about what is happening on Twitter and what news it is bringing to us every moment. However, with huge amount of data, it is impossible to tell what topic is trending on time manually, which makes real-time topic detection attractive and significant. Furthermore, Twitter provides a platform of opinion sharing and sentiment expression for events, news, products etc. Users intend to tell what they are really thinking about on Twitter thus makes Twitter a valuable source of opinions. Nevertheless, most works about trending topic detection fail to take sentiment into consideration. This work is based on a non-parametric supervised real-time trending topic detection model with sentimental feature. Experiment shows our model successfully detects trending sentimental topic in the shortest time. After a combination of multiple features, e.g. tweet volume and user volume, it demonstrates impressive effectiveness with 82.3% recall and surpasses all the competitors.

Abstract:Most online news websites have enabled users to annotate their sentiments while reading the news. Different from traditional users' feedbacks such as reviews or ratings, those annotations are more intuitive to express the sentiment of the users. Topic model is proved more effective to analyze the text information, however, most existing topic models focus on either extracting static topic sentiment or tracking topics over time but ignoring sentiment analysis. In the paper, we propose a joint topic-sentiment over time model (JTSoT) to detect the topic-sentiment shift and track the topic evolution over time. The critical challenge is how to balance the relationship among the topic, sentiment and time. The topic is represented as a Beta distribution over time and a Dirichlet distribution with respect to the sentiment. We evaluate our method on the real-world news dataset. The experimental results show that we have achieved high correlation between the topic and sentiment, better interpretable topic evolution, and higher document sentiment classification result and perplexity.

Abstract:Twitter is one of the biggest platforms where massive instant messages (i.e. tweets) are published every day. Users tend to express their real feelings freely in Twitter, which makes it an ideal source for capturing the opinions towards various interesting topics, such as brands, products or celebrities, etc. Naturally, people may anticipate an approach to receiving the common sentiment tendency towards these topics directly rather than through reading the huge amount of tweets about them. On the other side, Hashtags, starting with a symbol "#" ahead of keywords or phrases, are widely used in tweets as coarse-grained topics. In this paper, instead of presenting the sentiment polarity of each tweet relevant to the topic, we focus our study on hashtag-level sentiment classification. This task aims to automatically generate the overall sentiment polarity for a given hashtag in a certain time period, which markedly differs from the conventional sentence-level and document-level sentiment analysis. Our investigation illustrates that three types of information is useful to address the task, including (1) sentiment polarity of tweets containing the hashtag; (2) hashtags co-occurrence relationship and (3) the literal meaning of hashtags. Consequently, in order to incorporate the first two types of information into a classification framework where hashtags can be classified collectively, we propose a novel graph model and investigate three approximate collective classification algorithms for inference. Going one step further, we show that the performance can be remarkably improved using an enhanced boosting classification setting in which we employ the literal meaning of hashtags as semi-supervised information. Experimental results on a real-life data set consisting of 29,195 tweets and 2,181 hashtags show the effectiveness of the proposed model and algorithms.

Abstract:ABSTRACTIn large social networks, users feel free to share their feelings about anything they are interested in and many research works have focused on modeling users' interests on social network for product recommendations or personal services. Unfortunately, there are fewer works about finding why users like or dislike something. More specifically, there are many researches about sentiment analysis of users' opinion toward products or topics, but fewer are focused on why they hold this feeling and which aspects or factors of the product (topic) lead to users' different opinions about it. In this paper, we present a hierarchical generative model, called user-sentiment topic model (USTM), which captures users' topics with sentiment information. Our aim is to use USTM to refine users' topics with different sentiment trends including positive, negative and neutral, which can be further used in social network analysis to find influential users on topic level with sentiment information. The experiment results on three datasets show that our proposed USTM can capture user's interests with their sentiment well, making it useful for social network analysis.
Exploiting Topic Based Twitter Sentiment for Stock Prediction.

Abstract:This paper proposes a technique to leverage topic based sentiments from Twitter to help predict the stock market. We first utilize a con- tinuous Dirichlet Process Mixture model to learn the daily topic set. Then, for each topic we derive its sentiment according to its opin- ion words distribution to build a sentiment time series. We then regress the stock index and the Twitter sentiment time series to predict the market. Experiments on real-life S&P100 Index show that our approach is effective and performs better than existing state-of-the-art non-topic based methods.

Abstract:Public sentiment within social networks exerts a profound influence on societal dynamics, underscoring the increasing demand for accurate public opinion prediction. Most existing methods predominantly measure sentiment by quantifying user sentiments individually, overlooking group-level factors that crucially contribute to public sentiment. Thus, based on our finding that public sentiment is primarily shaped by user-group interactions and their interplay with evolving topics, we innovatively model the forming process of public sentiment at the group level. In this paper, we propose the Topic and Role Enhanced Group-level Public Sentiment Prediction model (TRESP), capturing the intricate interplay among sentiment, topic, and role. Specifically, an LSTM neural network is firstly leveraged to trace the temporal correlations between topics and sentiment shifts, yielding a topic-informed content sentiment representation. Subsequently, a specially crafted hierarchical attention network captures social and role attributes, representing the overarching social group environment. Finally, we predict future public sentiment by merging the derived group sentiment representation with the group social representation, demonstrating a holistic insight into the sentiment trajectory. Extensive experiments were conducted on two real-world datasets of over 30,000 tweets collected from more than 14,000 users to validate our model. Notably, our model significantly outperforms the state-ofthe-art approaches in public sentiment prediction, indicating the importance and effectiveness of encapsulating interactions both within and among user subgroups.

Abstract:The user-generated social media messages usually contain considerable multimodal content.Such messages are usually short and lack explicit sentiment words.However,we can understand the sentiment associated with such messages by analyzing the context,which is essential to improve the sentiment analysis performance.Unfortunately,majority of the existing studies consider the impact of contextual information based on a single data model.In this study,we propose a novel model for performing context-aware user sentiment analysis.This model involves the semantic correlation of different modalities and the effects of tweet context information.Based on our experimental results obtained using the Twitter dataset,our approach is observed to outperform the other existing methods in analysing user sentiment.

Abstract:Video popularity prediction plays a foundational role in many aspects of life, such as recommendation systems and investment consulting. Because of its technological and economic importance, this problem has been extensively studied for years. However, four constraints have limited most related works' usability. First, most feature oriented models are inadequate in the social media environment, because many videos are published with no specific content features, such as a strong cast or a famous script. Second, many studies assume that there is a linear correlation existing between view counts from early and later days, but this is not the case in every scenario. Third, numerous works just take view counts into consideration, but discount associated sentiments. Nevertheless, it is the public opinions that directly drive a video's final success/failure. Also, many related approaches rely on a network topology, but such topologies are unavailable in many situations. Here, we propose a Dual Sentimental Hawkes Process (DSHP) to cope with all the problems above. DSHP's innovations are reflected in three ways: (1) it breaks the "Linear Correlation" assumption, and implements Hawkes Process; (2) it reveals deeper factors that affect a video's popularity; and (3) it is topology free. We evaluate DSHP on four types of videos: Movies, TV Episodes, Music Videos, and Online News, and compare its performance against 6 widely used models, including Translation Model, Multiple Linear Regression, KNN Regression, ARMA, Reinforced Poisson Process, and Univariate Hawkes Process. Our model outperforms all of the others, which indicates a promising application prospect.
EPAB: Early Pattern Aware Bayesian Model for Social Content Popularity Prediction

Abstract:The boom of information technology enables social platforms (like Twitter) to disseminate social content (like news) in an unprecedented rate, which makes early-stage prediction for social content popularity of great practical significance. However, most existing studies assume a long-term observation before prediction and suffer from limited precision for earlystage prediction due to insufficient observation. In this paper, we take a fresh perspective, and propose a novel early pattern aware Bayesian model. The early pattern representation, which stands for early time series normalized on future popularity, can address what we call early-stage indistinctiveness challenge. Then we use an expressive evolving function to fit the time series and estimate three interpretable coefficients characterizing temporal effect of observed series on future evolution. Furthermore, Bayesian network is leveraged to model the probabilistic relations among features, early indicators and early patterns. Experiments on three real-world social platforms (Twitter, Weibo and WeChat) show that under different evaluation metrics, our model outperforms other methods in early-stage prediction and possesses low sensitivity to observation time.
Sentiment Analysis for Twitter : Going Beyond Tweet Text

Abstract:Analysing sentiment of tweets is important as it helps to determine the users' opinion. Knowing people's opinion is crucial for several purposes starting from gathering knowledge about customer base, e-governance, campaigning and many more. In this report, we aim to develop a system to detect the sentiment from tweets. We employ several linguistic features along with some other external sources of information to detect the sentiment of a tweet. We show that augmenting the 140 character-long tweet with information harvested from external urls shared in the tweet as well as Social Media features enhances the sentiment prediction accuracy significantly.

Abstract:With the rapid development of the Internet, more and more users expressed their views on the Internet. Therefore, the big data of texts are generated on the Internet. In the era of big data, mining the sentiment tendencies contained in massive texts on the Internet through natural language processing technology has become an important way of public opinion supervision. In this paper, the sensitive information topics-based sentiment analysis method for big data is proposed. This method integrates topic semantic information into text representation through a neural network model. The attention mechanism is introduced into the neural network, and context-aware vector is introduced to calculate the weight of each word. In addition, in order to make the model more adaptable, the method of sentiment dictionary tagging is used to obtain the training data. The experimental results show that the proposed model can effectively improve the accuracy of sentiment analysis results.

Abstract:Considering sentiment analysis of microblogs plays an important role in behavior analysis of social media, there has been a significant progress in this area recently. However, most researches are topic-ignored and neglect the sentimental orientation towards different topics. We propose two combined methods for topic-related Chinese message sentiment analysis. One is a graph-based ranking model of LT-IGT which takes both local and global topical information into consideration. And the other is a method of exploring sentimental features on expanded topical words with word embedding which considers both the syntactic and semantic information. These two methods are integrated into a topic-related Chinese message sentiment classifier. Experimental results on SIGHAN8 dataset show the outperformance of this approach compared with other well-known methods on sentiment analysis of topic-related Chinese message.
